To find the best open-weight model for your workload, evaluate candidate models on representative examples from that workload—not just on a public leaderboard. Define what counts as success, keep the comparison conditions consistent (or disclose where they differ), and measure both answer quality and the resources needed to produce it. The result is a decision about a specific task and setup, not a universal ranking of models.

Start by defining what “best” means for your workload

Before selecting models or running tests, write down the decision you need to make. Specify who will use the model, what tasks it must handle, which errors matter most, and what minimum quality level is acceptable. Separate must-pass requirements from preferences: a model that is slightly faster may still be unsuitable if it fails a critical accuracy or safety check.

Make the success criteria observable. Depending on the task, that could mean exact-match correctness, a rubric score, successful completion of a workflow, or a human judgment against defined criteria. Decide how results will be scored and normalized before seeing which model wins. Otherwise, it is easy to favor a candidate by changing the standard after the fact.

Build an evaluation set that resembles real use

Use examples drawn from the inputs, constraints, and output formats your users will actually encounter. Include common cases as well as difficult ones: ambiguous requests, edge cases, long or incomplete inputs, and cases where the right answer is to acknowledge uncertainty or decline a request. For each example, define an expected result or a scoring rubric.

Keep some cases out of initial model selection. A held-out set, or a set refreshed with new examples, helps confirm that a model’s apparent advantage carries over to inputs it was not repeatedly tuned against. When feasible, include private or dynamically updated cases alongside public benchmarks. Static public tests can be contaminated or overfit, so a benchmark score alone may not predict performance on unseen work; see Pitfalls of Evaluating Language Models with Open Benchmarks.

Public benchmarks and model cards are useful for shortlisting candidates and finding documented strengths or limitations. They are not substitutes for testing your workload. Hugging Face notes that model-card scores are often produced by the model author, and that model cards and leaderboards provide different kinds of evidence. Choose what your comparison is meant to establish

There are two useful but different comparison goals. Decide which one you are pursuing before you run the evaluation, because it determines whether the setup should be identical or individually optimized.

Comparison goal How to run it What the result supports
Controlled comparison Keep the task inputs, prompt, tools, scoring, context, inference conditions, and resource budget the same for each candidate. How the models compare under a shared setup. A fixed harness improves comparability but may not elicit each model’s best task performance.
Optimized-system comparison Allow credible, task-appropriate prompts, tools, or scaffolding for each candidate; record and disclose every setup and resource difference. How the candidate systems perform when each is elicited with its own setup. Differences cannot be attributed to the model weights alone.

Neither goal is inherently better. A controlled comparison is useful when you need to isolate performance under common conditions. An optimized-system comparison is useful when you want to choose the strongest practical arrangement for deployment. OpenAI’s evaluation guidance emphasizes that capability claims depend on the elicitation setup and on choosing a harness suited to the task: A shared playbook for trustworthy third-party evaluations.

Run the comparison as a reproducible procedure

  1. Record the candidates. Write down each model’s exact name and revision, not merely its family name. Note the inference backend and any model-specific chat template or prompt formatting.
  2. Freeze the evaluation materials. Record the task data and split, examples, prompts, task formulation, tools, scoring rubric, and normalization rules. Keep the held-out examples separate from any examples used to tune the setup.
  3. Set the inference conditions. Document decoding settings, context limits, software versions, hardware, and any token, time, or monetary budget. For a controlled comparison, keep these conditions fixed where possible; for an optimized-system comparison, document differences explicitly.
  4. Run every case and preserve outputs. Keep the raw responses, scores, errors, and run configuration so you can inspect unexpected results and repeat the evaluation.
  5. Score and inspect failures. Report task-appropriate scores, but also review examples and group errors by type. An aggregate score can hide a failure that matters to your users.
  6. Repeat with variations and fresh cases. Try realistic prompt variations and held-out or newly collected examples. Check whether apparent differences remain meaningful and stable for the workload.

Evaluation conventions can materially change reported scores. OLMES (Open Language Model Evaluation Standard) makes explicit the choices involved in dataset processing, prompt construction, examples, task formulation, normalization, and scoring; its approach can be used in frameworks such as the LM Evaluation Harness and HELM. The paper cites a 2023 study reporting accuracy differences of up to 80% from varying formatting and in-context examples. That is a result discussed in the paper, not an expected or universal effect for every task. See the OLMES paper.

Measure operating fit as well as task quality

A model that answers well may still be impractical for your deployment. Under the hardware, backend, and optimization choices you expect to use, record the operational measures that matter:

  • Latency: how long a task or response takes under your stated conditions.
  • Throughput: how much work the system completes over time in the intended operating pattern.
  • Memory: whether the model and workload fit the available resources.
  • Energy: where power use is relevant to your operating constraints.
  • Budget and effort: the token, time, or monetary budget, plus any human review or repeated attempts needed to achieve an acceptable result.

Do not report these measurements without the conditions that produced them. Hardware, backend, optimization, concurrency, and budget affect what a result means. If users will retry failed requests, consider resource use per successful task rather than only the cost of a single attempt. Public model evaluation resources include performance-focused leaderboards that cover latency, throughput, memory, and energy, but deployment-relevant measurements should reflect your own operating conditions. Hugging Face’s Evaluate documentation points to these resources and recommends LightEval for more recent approaches popular on the Hub; check current project documentation when choosing a framework.

Use tools that make the run easier to inspect

You do not need a particular framework to compare models, but a tool that stores prompts, task definitions, and configurations can make results easier to reproduce. The EleutherAI LM Evaluation Harness documentation describes support for 60+ benchmarks and hundreds of subtasks, several backends—including Hugging Face Transformers, vLLM, OpenAI-compatible APIs, and custom models—and YAML task configurations with shareable configs and versioning. These are capabilities of that framework, not requirements for every evaluation.

Whether you use a framework or a small custom test runner, make it possible for another person to reconstruct the comparison. Record model revisions, prompts and templates, examples and data splits, scoring and normalization, inference settings, software versions, hardware, and budget. The 2024 paper by Gao and coauthors on reproducible language-model evaluation discusses the challenges of making evaluations reproducible.

Interpret results without overstating them

Choose the candidate that clears the minimum quality bar and offers an acceptable balance of task performance, latency, resources, and operational effort. If two candidates are close, inspect the errors that matter to your users and whether the difference persists across fresh cases and realistic prompt variants. A small aggregate-score gap is not decisive unless it is stable and meaningful for the use case.

Describe the outcome narrowly: name the tested task set, model revisions, inference setup, and budget, and say whether the comparison was controlled or optimized. A measured result establishes performance under those conditions; it does not establish an absolute capability ceiling. More elicitation, tools, examples, or resources could change what a model can achieve. Finally, check the license and terms for each specific model against your intended use. Evaluation scores do not establish that a model’s terms are suitable for your deployment.
