xLSTM is a credible research-backed challenge to Transformer dominance, not yet a universal replacement for Transformers. It modernizes recurrent neural networks with exponential gating, scalar- and matrix-memory cells, and Transformer-like residual blocks. The result is a promising architecture for streaming, long-sequence and bounded-memory inference, while its small model ecosystem, custom kernels and limited serving support remain substantial constraints.
Why xLSTM matters
Transformers became the default architecture for language models because self-attention makes training highly parallel, gives each token flexible access to other tokens, and benefits from an enormous ecosystem of checkpoints, optimizers and serving systems. Conventional LSTMs retained useful recurrent memory but were harder to scale efficiently on modern accelerators.
xLSTM attempts to combine recurrent state with the scaling practices of modern large models. Its original paper, posted on May 7, 2024 and presented at NeurIPS 2024, describes an extended LSTM family intended to scale to billions of parameters while supporting parallelizable training: the original xLSTM paper and its NeurIPS version.

What xLSTM changes in an LSTM
Exponential gating
Traditional LSTMs use sigmoid-style gates to control information flow. xLSTM uses exponential gates with normalization and stabilization techniques designed to keep accumulation numerically manageable. “Exponential” does not mean simply making gates larger: it changes the way remembering and forgetting are represented, making a careful implementation essential.
sLSTM: scalar memory
The sLSTM variant retains a scalar-style memory and introduces scalar updates and revised memory-mixing behavior. It aims to preserve the useful recurrent dynamics of an LSTM while improving capacity and stability.
mLSTM: matrix memory
mLSTM stores a matrix rather than a single scalar-style memory representation and applies a covariance-like update. This gives the cell a richer state and is designed to permit parallel computation across sequence positions during training.
These are components, not separate products. An xLSTM model can combine sLSTM and mLSTM blocks in residual stacks that look familiar to engineers used to modern Transformer architectures. The architecture details are defined in the paper.
Why recurrent inference can be efficient
During autoregressive Transformer decoding, the key-value cache normally grows as more tokens are processed. A recurrent model carries forward a bounded state instead of retaining every prior token representation for attention. The xLSTM papers describe linear compute scaling with sequence length and constant-size recurrent inference state; the 7B paper reports faster decoding than its Llama- and Mamba-based baselines in its own experiments: xLSTM 7B.

This can benefit streaming sensors, online prediction, long-running agents, embedded devices and high-volume generation. But “constant memory” applies to recurrent state, not total system memory. Weights, activations, batching, tokenizer buffers, framework overhead and any retrieval store still consume memory. The architecture overview is available from NXAI.
Bounded state also means compressed memory. A Transformer can directly compare a current token with many earlier token representations; xLSTM must encode history into its state. It may process a very long stream without a growing cache yet still fail to reproduce an arbitrary detail from far earlier in that stream. Long-context capacity is not the same as perfect recall.

What the published evidence shows
Original architecture results
The 2024 work reports competitive language-modeling results against Transformer and state-space baselines. Those results establish that recurrent ideas can be trained at modern scale, rather than proving superiority on every task or hardware target.
xLSTM 7B
The follow-up 2025 paper reports comparable downstream performance to similarly sized models and favorable inference results against Llama- and Mamba-based baselines. The authors’ setup matters: speed depends on sequence length, batch size, precision, accelerator, prefill versus decode, and kernel implementation. Treat these as reported benchmark outcomes, not universal guarantees.
NXAI’s official repository describes xLSTM Large as a 7-billion-parameter language model trained on 2.3 trillion tokens and links to weights on Hugging Face. This checkpoint should not automatically be treated as a turnkey chatbot: the existence of weights does not establish leading instruction following, safety, multilingual, coding or tool-use quality.

Broader research
NXAI lists work on vision, robotics, biological sequences, forecasting, optimized kernels and scaling laws at its publications page. That breadth indicates an active research program, not a mature production ecosystem. The official implementations include the PyTorch repository, optimized mLSTM kernels and a JAX implementation.

Mamba is the closest architectural rival in the efficient-sequence discussion, but it is not simply an inferior or interchangeable technology. Its equations, inductive bias, kernels and checkpoints differ. Compare both on your hardware and task rather than transferring one paper’s ranking to another deployment. The Mamba repository is at state-spaces/mamba.
Can developers use xLSTM today?
Yes, but the practical path is research-oriented rather than turnkey production serving.
Official installation path
- Clone the repository:
git clone https://github.com/NX-AI/xlstm.git - Enter it:
cd xlstm - Install the package:
pip install -e . - For xLSTM Large, install the kernel and package listed by the repository:
pip install mlstm_kernelsandpip install xlstm. - Use the provided Conda environment file, currently named
environment_pt240cu124.yaml, after checking the repository for updated dependencies. - Start with the demo notebook and validate PyTorch, CUDA and kernel compatibility before attempting production serving.
The repository states that CUDA sLSTM requires NVIDIA Compute Capability 8.0 or newer, excluding some older GPUs. Non-NVIDIA deployment may require a different implementation path. Check the current repository and release page before installation; the repository search result lists v2.0.4 dated May 28, 2025, but releases are volatile.
Do not confuse the demo with the 7B model
The example configuration uses values such as embedding_dim=512, num_heads=4, num_blocks=6, vocab_size=2048, return_last_states=True and mode="inference". It demonstrates the API; it is not the xLSTM 7B production configuration.

A 7-billion-parameter checkpoint needs about 14 GB for FP16 or BF16 weights alone, using the arithmetic estimate of roughly two bytes per parameter. Runtime state, activations, allocator reserve and batching require additional memory.
How to benchmark it responsibly
Do not report only tokens per second. Run the xLSTM model against the Transformer or Mamba model you would actually deploy, using identical task data and relevant sequence lengths.
- Measure prefill latency, decode latency and time to first token separately.
- Record peak GPU memory, power or energy, throughput and cold-start behavior.
- Test multiple batch sizes and short, medium and long sequences.
- Measure task quality, including long-range recall where it matters.
- Verify state reset between independent conversations and behavior when limits are exceeded.
A recurrent model may look especially strong during long decoding while a Transformer is more competitive during parallel prompt ingestion. Both phases belong in the result.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Operational risks and deployment trade-offs
State management
Each recurrent state must be initialized correctly, associated with the right stream, reset between unrelated sessions, and persisted or discarded according to application policy. A missed reset can leak information between requests, creating a different failure mode from ordinary stateless prompt-plus-cache serving.
Kernels determine real performance
Parallelizable training does not guarantee fast inference. xLSTM’s practical advantage depends on optimized CUDA or Triton-style implementations, precision support, batching and the serving framework. Reproducing paper results outside the authors’ environment may require engineering work.
Best Value
Ecosystem gaps
xLSTM has fewer pretrained and instruction-tuned checkpoints, less standardized quantization and fine-tuning support, and limited integration with mainstream engines such as vLLM, TGI and TensorRT-LLM. Independent testing is also much thinner than for Transformers.
Who should choose xLSTM?
Choose xLSTM when
- Your workload is inherently sequential or streaming.
- Attention-cache growth is a major memory or latency concern.
- You can maintain custom PyTorch/CUDA infrastructure.
- Bounded state is more valuable than arbitrary token-by-token history access.
- The available checkpoint meets your quality requirements.
Prefer a Transformer when
- You need broad checkpoint, instruction-tuning or multimodal choice.
- Your team depends on mature vLLM, TGI, TensorRT-LLM or managed API tooling.
- Exact retrieval from arbitrary prior context, tool use and established observability are central.
- You need predictable hosted support, quantization and LoRA workflows.
Consider Mamba or another state-space model when
- You want efficient sequence processing with a different recurrent-style formulation.
- Your team already has compatible kernels or checkpoints.
- Your task benchmarks favor that state-space model.
- You want a serious alternative comparison rather than adopting xLSTM from paper claims alone.
Deployment and commercial options
The most realistic route is self-hosting the official code and weights. Hugging Face offers dedicated Inference Endpoints at its endpoint product page, with runtime pricing documented at the pricing page. The cited snapshot lists infrastructure examples from $0.50 per hour for an AWS T4 to $2.50 for an AWS A100 and $10.00 for a GCP H100. These are instance rates, not xLSTM-specific API prices; regional availability, quotas and custom-container compatibility vary.
AWS supports Hugging Face deployment through SageMaker via its Hugging Face integration, but that does not prove xLSTM is optimized for every SageMaker container or accelerator. Expect to validate a compatible or custom container and the required kernels. For teams that do not need architecture control, a hosted Transformer API from OpenAI, Anthropic or Google Vertex AI is operationally simpler, though it cannot provide local recurrent state or xLSTM-specific customization.
Check the precise license for the checkpoint and repository before redistribution or commercial embedding.
The verdict
xLSTM is one of the clearest attempts to make recurrent neural networks competitive again at modern language-model scale. Its exponential gates, sLSTM and mLSTM cells offer a credible route to bounded-state inference and efficient processing of sequential data. The 2024 architecture and 2025 7B results justify serious evaluation, especially for streaming, edge and long-running workloads.
They do not justify declaring Transformers finished. For general-purpose chat, multimodal systems, retrieval-heavy prompts and teams that need mature serving infrastructure, Transformers remain the safer default. xLSTM’s near-term role is as a specialized efficient sequence model, a research platform and a complement to attention—not a universal replacement.
