When an AI model runs out of accelerator memory, first identify exactly when the failure occurs and what allocation failed. A model that cannot load its weights needs a different remedy from one that loads successfully but runs out of memory allocating a KV cache, activations, or CUDA graph buffers. The familiar “CUDA out of memory” message applies to NVIDIA’s CUDA stack; other accelerators report different errors, but the same diagnostic principle applies: match the fix to the failed allocation.
Start with the failure stage and exact error
Record the complete error and the last operations in the logs before changing settings. The failure stage is often the most useful clue: it can distinguish a model that does not fit at all from a workload that exceeds memory only after loading.
For NVIDIA NIM, version 2.0.13 documentation separates failures during weight loading, KV-cache allocation, and CUDA graph compilation or warmup, and recommends choosing a remedy based on the stage. That guidance is specific to NIM; check the documentation for the NIM release actually deployed, since supported options can vary by version and model.

Check whether weights are the dominant allocation and whether supported placement or precision options exist.
- KV-cache allocation: The model loaded, but serving the requested context or concurrent workload requires more memory for cached attention state. Review maximum sequence or context length and other workload settings.
- CUDA graph compilation or warmup: The failure occurs after loading, during graph capture or warmup. Inspect the relevant runtime and serving configuration instead of assuming that the model weights are too large.
Do not diagnose from a short headline error alone. Preserve the full traceback or serving log, note the model, framework and runtime versions, and capture the request or training configuration that triggered the failure.

Check usable memory, not just the accelerator’s advertised capacity
The accelerator’s nominal memory is not all available for model tensors. Framework kernels, runtime state, communication buffers, and other allocations also consume memory. Hugging Face Accelerate’s big-model inference documentation notes that the first PyTorch allocation loads CUDA kernels, which it estimates take about 1–2 GB depending on the GPU. That is a documented, implementation-specific estimate, not a fixed allowance for every device or software version.
Check current free memory and processes using the monitoring facilities for your accelerator and operating system. Account for other model workers, users, or jobs on the same device. A model that fits on an otherwise idle accelerator may fail when another process has already claimed part of the memory.
Also distinguish allocated memory from reserved memory if the framework exposes both. A process can reserve memory for its allocator without currently assigning all of it to tensors. That difference can matter when investigating fragmentation, but it does not establish fragmentation as the cause by itself.
Identify which allocation is growing
Model weights are only one part of an inference or training workload. Depending on the stack and task, the run may also allocate activations, a key-value (KV) cache, communication buffers, and memory for graph capture. A successful weight load therefore does not prove that the full workload fits.
Context length and workload settings can change memory requirements after loading. In inference, longer sequences can increase KV-cache demand; in training, batch size affects the amount of data processed on each device and the activations retained for computation. The exact balance varies with the model, architecture, framework, precision, and serving or training configuration.

As a scale illustration—not a total-memory guarantee—NVIDIA’s NIM 2.0.13 troubleshooting documentation estimates that weights for a 70-billion-parameter model in BF16 require approximately 140 GB. Runtime allocations are additional. This example should not be treated as a universal VRAM requirement: it describes weights at a specified parameter count and precision, not the memory needed for every model or workload.
Choose a remedy that matches the workload
| Failure or constraint | Remedy to investigate | Main trade-off or condition |
|---|---|---|
| Training batch does not fit | Reduce the per-device batch size; consider gradient accumulation. | Accumulation can preserve a larger effective batch across steps, but it does not make a single oversized per-device allocation fit. Check the training framework and version. |
| Inference KV cache exceeds memory | Reduce the maximum sequence or context length if the workload permits. | Shorter limits can restrict the amount of context available to a request. |
| Weights do not fit on one device | Use a supported device map to spread layers across available GPUs, or offload weights to CPU or disk where the framework supports it. | Placement depends on the model and stack; offload and multi-device execution can affect performance. |
| Model configuration is too large for the selected profile | Check whether the serving stack supports more tensor or pipeline parallelism, or a lower-precision option. | Support is hardware- and profile-dependent. Lower precision may affect model quality; parallelism changes deployment requirements and performance. |
| Contiguous allocation fails despite reserved memory | Investigate fragmentation only when the logs and memory figures support that diagnosis. | The allocator setting is specific to the documented NIM case and version; it is not a universal OOM switch. |
For training, reduce the per-device memory demand
If training fails when a batch is processed, lower the batch size on each device first. Transformers v4.46 troubleshooting supports batch-size reduction and gradient accumulation as relevant measures; check the version in use before relying on particular API parameter names.
Gradient accumulation divides an effective batch across multiple forward and backward passes before an optimizer update. It can reduce the batch-related memory needed for each pass, but it does not eliminate memory required by the model, activations, optimizer state, or other training components. Change one setting at a time and confirm that the failing step completes before increasing the workload again.
For inference, adjust context and placement deliberately
If weights load but inference fails during KV-cache allocation, lower the maximum context or sequence length to a value the application can accept. If the failure is instead at weight loading, changing the request context may not address the cause; investigate device placement, supported offload, parallelism, and precision options.
Hugging Face Accelerate documents device maps that can distribute model layers among available GPUs and offload weights to CPU or disk. These options can make a model runnable when one accelerator cannot hold all weights, but they rely on framework and model support. Moving data between devices or using slower storage can change latency and throughput. The available guidance does not provide a universal performance benchmark, so measure the result in the actual deployment.

NVIDIA NIM documentation also discusses profiles with more tensor or pipeline parallelism and lower-precision options. Availability depends on the hardware, model, and NIM profile. Confirm that the desired profile is supported before changing the deployment, and assess quality implications before adopting lower precision.

Before choosing between a shorter context, offload, multi-GPU placement, or a precision change, compare the options against the same workload. First ask which allocation stage failed and whether the main pressure comes from weights or runtime tensors. Then check usable accelerator memory, CPU RAM if considering CPU offload, and whether more than one compatible GPU and a supported device map are available.
Finally, write down the constraint the fix is allowed to change: maximum context, throughput, latency, or model precision and quality. A shorter context may solve cache pressure but reduce how much information a request can use. Offload or spreading layers can address a single-device weight limit, but may affect performance. Lower precision may reduce weight memory but requires support and a quality check. The sources do not establish universal benchmarks for these trade-offs, so compare results on representative requests and the real deployment hardware rather than assuming one option is always best.
No purchase price or cost comparison is supported by the available documentation. Likewise, it does not identify a retail GPU or accelerator that will fit this workload. If a hardware change is being considered, first establish the required memory and platform compatibility from the diagnosed workload; do not treat a generic capacity estimate as a purchasing guarantee.
Use allocator settings only when the evidence fits
Fragmentation is a possible explanation, not the default explanation for every allocation error. NVIDIA NIM 2.0.13 describes a particular case: a contiguous allocation fails while a substantial amount of memory is reserved but unallocated. For that case, the documentation identifies the PyTorch environment setting PYTORCH_ALLOC_CONF=expandable_segments:True.

Do not apply this setting blindly. First confirm the relevant memory pattern and that the deployed NIM version documents the option for the model and workload. If weights or runtime tensors simply require more memory than is available, an allocator configuration cannot create additional capacity.
When a hardware change may be necessary
Consider more accelerator memory or a multi-GPU setup only after checking the failure stage, other processes, workload limits, and supported placement or precision options. A hardware change must also fit the platform, model, runtime, and application requirements. There is no single VRAM figure that guarantees every model will run: memory demand depends on model size and precision as well as runtime allocations and workload configuration.
The cited technical guidance does not establish a universal benchmark or identify a specific accelerator as the right purchase. Cooling accessories are not established as a remedy for memory-allocation failures. Treat hardware selection as a workload- and compatibility-specific decision rather than a substitute for diagnosis.
A practical troubleshooting sequence
- Capture the failure. Save the exact error, full logs, model and software versions, and the input or batch configuration that triggered it.
- Locate the stage. Determine whether the failure is during weight loading, KV-cache allocation, graph compilation or warmup, or a training step. For NIM, use the phase distinctions documented for the deployed release.
- Check device use. Inspect free memory, other processes, and framework-level allocated or reserved memory where available. Remember that nominal capacity is not entirely available for model tensors.
- Match the change to the cause. For a training batch failure, reduce per-device batch size and consider accumulation. For inference KV-cache pressure, lower the context limit if acceptable. For weights that do not fit, check supported device maps, offload, parallelism, or precision.
- Verify the outcome. Rerun the same workload and confirm that it passes the formerly failing stage. Then test representative inputs and expected concurrency; a fix for one request size does not establish that every workload fits.
- Escalate capacity only if needed. If supported settings and placements still cannot accommodate the workload, evaluate higher-memory or multiple accelerators against platform compatibility and measured workload needs.
What the available guidance does not establish
Memory estimates from a parameter count or a single framework note are not cross-model benchmarks. The 70-billion-parameter BF16 example describes approximate weight memory only, while the Accelerate kernel figure is an implementation-specific estimate. Neither predicts total memory for every model, accelerator, software release, or workload.
Framework optimizations can also vary by model architecture, as the Diffusers documentation cautions. Check the versioned documentation for the framework, model, and serving stack in use rather than assuming a setting or optimization transfers across ecosystems. None of the documented examples gives a universal throughput, latency, or quality trade-off for offload, multi-GPU placement, or lower precision.

Frequently Asked Questions
Does “CUDA out of memory” always mean the model weights are too large?
No. The error can occur during weight loading, KV-cache allocation, graph compilation or warmup, or a training step. Check the full logs and stage first: weights are only one consumer, and runtime allocations may be the cause even when the model loaded successfully. CUDA-specific wording applies to NVIDIA’s CUDA stack; other accelerators may report different errors.
Why can a model fail even when its weights appear to fit in VRAM?
Nominal device memory is not all available for weights. Framework kernels, runtime state, activations, communication buffers, KV cache, and graph capture can require additional memory. Other processes can also use part of the device. For example, Accelerate documents an estimate of about 1–2 GB for CUDA kernels loaded on the first PyTorch allocation, depending on the GPU; that is not a fixed overhead for all systems.
Should I try PYTORCH_ALLOC_CONF=expandable_segments:True for every OOM?
No. NVIDIA NIM 2.0.13 documents this setting for a specific fragmentation case: a contiguous allocation failure accompanied by substantial reserved-but-unallocated memory. Confirm that the logs and memory figures match, and check the documentation for your deployed NIM version. The setting cannot make an oversized workload fit in insufficient memory.
Quick wins for a faster PC:
Clear out junk files and repair common Windows errorsFree Scan →Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →Will offloading or using more GPUs guarantee the same speed and quality?
No universal guarantee is established. Accelerate supports device maps that spread layers across available GPUs and offload weights to CPU or disk, while NIM documents certain profiles with more tensor or pipeline parallelism and lower precision. Support depends on the model, framework, hardware, and profile. Offload or multi-GPU placement can affect performance, and lower precision may affect quality; test the supported choice against your own workload.
The Bottom Line
Find the exact stage and allocation behind the failure before changing settings. Reduce per-device batch size for training pressure, reduce context for inference KV-cache pressure, and investigate supported placement or precision options when weights do not fit. Treat fragmentation settings and hardware changes as evidence-led, environment-specific choices—not universal fixes.
