Do not approve an AI model because it posts a high benchmark score. Evaluate the complete system in the setting where it will operate: the model version, prompts, data, tools, permissions, interface, users, human oversight and consequences of failure. A defensible decision combines repeatable performance tests, adversarial testing, qualitative review, operational controls and an explicit judgment about residual risk.

This guide presents a practical pre-deployment workflow based on the National Institute of Standards and Technology (NIST) AI Risk Management Framework (AI RMF), its Generative AI Profile and NIST evaluation guidance. It explains what to test, how to document evidence, when a result is good enough for a particular use case, and which controls must remain active after release.

Evaluate the deployed system, not an isolated model

An AI model is only one component of a production capability. The same weights can behave very differently when connected to a retrieval system, external tools, customer data, automated actions or a different user population. Start by defining the system boundary and the decision it will support.

NIST’s AI Risk Management Framework, released in version 1.0 on January 26, 2023, treats risk management as a lifecycle spanning design, development, deployment, use, and test and evaluation. NIST describes the framework as voluntary guidance and says its live framework page is being revised. It is useful as a cross-sector structure, but it does not replace legal review, sector-specific validation or regulatory approval.

The relevant unit of evidence is therefore the intended AI system in its operating context. A benchmark result can establish capability on the benchmark’s task and conditions; it cannot establish universal safety.

1. Define exactly what you plan to deploy

Inventory the system boundary

Create a versioned description before testing begins. Include:

  • Model name, version, provider or training checkpoint, context limits and any fine-tuning.
  • System and developer prompts, safety policies, routing logic, temperature or other generation settings, and fallback behavior.
  • Training, retrieval and inference data sources, update schedules, retention rules and known coverage gaps.
  • Tools, APIs, plug-ins, browsers, databases, code execution and the permissions each component receives.
  • User interface, authentication, rate limits, logging, human review points and downstream systems that consume outputs.
  • Target users, affected non-users, operating geography, languages, devices, network assumptions and expected workload.
  • Planned changes, such as model swaps, prompt edits, new tools, data refreshes or expansion to another user group.

State allowed and forbidden outcomes

Write the job in observable terms: what the system must do, what it must never do, and what happens when it cannot answer. For example, a support assistant may be required to retrieve the current return policy, cite the relevant passage and transfer uncertain cases to an agent. It may be prohibited from changing an order, exposing another customer’s information or presenting an unverified guess as policy.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Define the human role as well. “Human in the loop” is not a control unless the reviewer has enough time, information and authority to detect and correct an error. Specify which outputs require approval, which actions are blocked automatically, and who owns the final decision.

Version the evaluation target

Record a unique release identifier for the model, prompts, data snapshots, tool permissions and application code. If any of these change, determine whether the change triggers partial or full re-evaluation. A test report that cannot be tied to the deployed configuration is not reliable evidence.

2. Map harms and operating conditions

Identify who can be affected

List direct users, people described in inputs, customers whose records are processed, employees who rely on recommendations and members of the public affected by automated actions. Include people who cannot see or challenge the output. For each group, document potential benefits, harms, ways to detect an error and available recovery.

Build a failure and misuse inventory

Describe ordinary, edge and deliberately abusive conditions. Depending on the application, scenarios may include ambiguous requests, missing fields, stale retrieval data, long conversations, language or accessibility differences, prompt injection, malicious documents, account takeover, data exfiltration, tool failure, service outage and distribution shift after launch.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

For every failure mode, estimate severity and likelihood, then record detectability and recoverability. A wrong restaurant recommendation and an incorrect medication instruction are both “errors,” but their acceptable controls and escalation paths are not comparable.

Choose trustworthiness characteristics that matter here

NIST groups relevant characteristics under concepts such as validity and reliability, safety, security and resilience, privacy, fairness, explainability and accountability. Use the characteristics that apply to the use case and justify exclusions.

Characteristic Questions to test
Validity and reliability Does the system perform the intended task accurately and consistently under expected conditions?
Safety Can an incorrect or unsafe output cause physical, financial, psychological or operational harm? Does the system fail safely?
Security and resilience Can attackers manipulate inputs, extract data, bypass controls or cause unacceptable service degradation?
Privacy Does the system collect, reveal, retain or infer personal information beyond the approved purpose?
Fairness Are error rates, access and treatment materially different for relevant groups or contexts?
Explainability Can users and reviewers understand the basis, uncertainty and limits of an output well enough to act responsibly?
Accountability and transparency Can an owner trace decisions, investigate incidents and provide an appeal or correction path?

NIST cautions in its AI RMF FAQs that “Addressing AI trustworthiness characteristics individually will not ensure AI system trustworthiness; tradeoffs are often involved, rarely do all characteristics apply in every setting, and some will be more or less important in any given situation.” Treat the table as a prioritization aid, not a checklist that proves trustworthiness.

3. Turn requirements into testable evidence

Set acceptance criteria before looking at results

For each material requirement, specify the measure, test population, sampling method, pass condition, confidence or uncertainty treatment, owner and action when it fails. Do not choose a threshold merely because a candidate model happens to achieve it. A threshold should reflect the harm of false positives and false negatives, available human review and the organization’s risk tolerance.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Use representative cases and disclose coverage

Assemble a controlled evaluation set that reflects expected users, languages, input lengths, data quality, peak loads and relevant edge cases. Separate development, tuning and final holdout data to reduce overfitting. Document who supplied the data, consent or licensing constraints, time period, missing groups, known label errors and scenarios not represented. If production data cannot be used, explain how the substitute differs.

Combine quantitative and qualitative review

Measure task performance with metrics suited to the job: for example, exactness or ranking quality for retrieval, calibration and abstention for decision support, latency and availability for an interactive service, and successful completion without unauthorized actions for an agent. Add structured expert review where a numeric score cannot capture harm, nuance or policy compliance.

NIST’s AI Resource Center describes objective, repeatable or scalable test, evaluation, verification and validation (TEVV) processes in the AI RMF Core. A useful test record includes the system version, test code or protocol, data provenance, evaluator qualifications, random seeds where applicable, environment, date, results, confidence or uncertainty, exceptions and limitations. Preserve enough information for an independent reviewer to reproduce the finding.

Test reliability as an operational property

Measure more than answer quality. Record latency distributions rather than only an average, timeout and error rates, rate-limit behavior, queue recovery, tool-call success, consistency across repeated runs and behavior after context growth. Test restarts, partial outages and stale indexes. A model that is accurate but unavailable during the business process is not reliable for that process.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

4. Use layered testing for generative systems

NIST’s Assessing Risks and Impacts of AI (ARIA) work describes three complementary levels: model testing, red-teaming and field testing. They answer different questions and should not be substituted for one another.

Layer What it examines Evidence to retain What it cannot prove alone
Model testing Defined capabilities, limitations, safety behavior and robustness on controlled datasets and scenarios. Datasets, protocols, metrics, subgroup and edge-case results, uncertainty and known gaps. How users will adapt, how connected tools behave or how harms emerge in live operations.
Red-teaming Adversarial prompts, misuse, prompt injection, policy bypass, data extraction and unsafe tool use. Attack objectives, tester expertise, attempts, successful exploits, severity, mitigations and retest results. That untested attack paths or future model changes are harmless.
Field testing Realistic workflow impacts, user behavior, human oversight, operational load and unexpected outcomes. Exposure limits, consent or safeguards, monitoring data, incidents, user feedback and exit criteria. That a limited pilot will predict every population or future environment.

NIST’s Evaluating Generative AI Technologies program similarly emphasizes measuring capabilities and limitations, adversarial evaluation and benchmark datasets. State precisely which prompts, tools, languages, attack classes and operating conditions each layer covered—and which it did not.

Design model tests around the task

  • Use a locked holdout set for final comparison and prevent test cases from entering prompt-tuning cycles.
  • Include abstention and uncertainty cases, not only questions with a known answer.
  • Check factuality against authoritative references where correctness matters; assess citation quality separately from citation presence.
  • Repeat stochastic tests enough to characterize variance, and record the generation settings.
  • Evaluate long-context behavior, malformed input, conflicting instructions and unavailable data.

Make red-teaming actionable

Give testers explicit objectives and access to the actual interface, retrieval layer and tools. Include both expert-led probing and systematic attack suites. Classify each finding by affected asset, exploitability, impact, detectability and recovery. A blocked prompt is not a closed finding if an attacker can reach the same capability through a document, another language, a tool argument or a multi-turn conversation. Retest after every mitigation.

Run a bounded field test

Start with a limited population, reversible actions, strict logging and a staffed escalation route. Define stop conditions before exposure, such as a severe incident, a privacy breach, a sustained error-rate increase or loss of human review capacity. Compare field behavior with the assumptions in the laboratory plan; unexpected user workarounds are evidence that the system boundary was incomplete.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

5. Compare candidate models on identical conditions

When choosing between models or system designs, hold the task, data, prompts, tools, user permissions and evaluation windows constant. A cheaper or more capable model may still be the worse choice if it increases unrecoverable failures or makes auditing impossible.

Comparison axis Evidence to collect
Task performance Representative accuracy, completion quality, abstention, calibration and latency under expected load.
Failure severity and recovery Worst credible outcomes, frequency, detection time, reversibility and human effort to correct.
Robustness Distribution shifts, noisy or incomplete inputs, adversarial prompts, prompt injection and tool errors.
Safety and policy adherence Refusal quality, safe alternatives, escalation, prohibited-content handling and behavior outside knowledge limits.
Reliability over time Variance across runs, drift, availability, timeouts, rate limits and behavior after data or prompt updates.
Privacy and security Data exposure paths, retention, access controls, extraction attempts and dependency vulnerabilities.
Group and context performance Material differences across affected populations, languages, devices and operating environments.
Transparency and auditability Traceable versions, logs, explanations, evaluator access and ability to reproduce decisions.
Operations Monitoring hooks, alert quality, rollback, replacement, decommissioning and integration constraints.

These axes are a synthesis of NIST trustworthiness and TEVV guidance. Select, weight and document only the criteria that matter to the particular deployment; do not create a composite score that hides a critical failure.

6. Review failures and residual risk

Maintain a failure register

For every material finding, record the input and context, observed output or action, expected behavior, affected parties, severity, likelihood estimate, root cause hypothesis, mitigation, owner, due date and retest result. Preserve near misses and evaluator disagreement; they reveal uncertainty that an aggregate score can conceal.

Check safe failure outside the system’s limits

Ask what happens when the model lacks current knowledge, receives contradictory evidence, encounters an unsupported language or loses access to a required tool. A safe response may be a clear abstention, a handoff or a blocked action—not a confident completion. The NIST Generative AI Profile (NIST AI 600-1), released July 26, 2024, calls for regular safety evaluations and safe failure, particularly beyond a system’s knowledge limits. Its recommendations also connect safety metrics with reliability, robustness, real-time monitoring and response to failures.

Decide whether residual risk is acceptable

Mitigations rarely reduce risk to zero. Determine whether the remaining risk is within the organization’s documented tolerance for this use, considering affected people, reversibility, insurance or contractual duties, regulatory obligations and the strength of human controls. NIST does not prescribe a universal pass score, so do not invent one. A high average score cannot compensate for a low-frequency failure that the organization cannot detect or recover from.

7. Record a conditional deployment decision

Use a written decision that another accountable person can audit. It should contain:

  1. Decision: go, no-go, or limited/conditional release.
  2. Scope: approved users, tasks, geography, model and configuration versions, tools and exposure limits.
  3. Evidence: test reports, red-team findings, field observations, expert reviews and unresolved uncertainties.
  4. Controls: access restrictions, human approval, rate limits, content filters, privacy safeguards, logging and fallback procedures.
  5. Residual risks: remaining failure modes, affected groups, severity and why they are acceptable or not.
  6. Ownership: accountable business owner, technical owner, safety or risk owner and incident contact.
  7. Reassessment triggers: model, data, prompt, tool, user, environment or use-case changes; threshold breaches; serious incidents; or new evidence.
  8. Exit conditions: rollback, suspension, replacement or decommissioning authority and the steps to execute it.

For higher-stakes uses, stage exposure rather than making a single irreversible launch. Preserve human review or another compensating control until field evidence supports expansion. This conditional approach follows the lifecycle, risk-tolerance and monitoring principles in NIST guidance; it is an organizational decision method, not a quoted NIST rule.

8. Operate the controls after release

Release is the start of production evaluation, not its end. The AI RMF Core’s post-deployment practices include monitoring, feedback, appeal and override, incident response, recovery, change management and decommissioning.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Define indicators and alert thresholds

  • Task success, abstention, correction and escalation rates.
  • Safety-policy violations, harmful outputs, unauthorized actions and privacy events.
  • Latency, timeout, availability, tool-call failures and queue backlogs.
  • Drift in input characteristics, retrieval coverage, user populations or outcome distributions.
  • Differences in performance or incidents across relevant groups and contexts.

Set thresholds that trigger investigation, throttling, rollback or suspension. Review alerts for both missed incidents and excessive false alarms.

Give users ways to report and challenge outcomes

Provide an accessible feedback channel with enough context to investigate, such as the conversation or decision identifier, model version and time. For consequential decisions, offer an appeal or override path to a qualified person. Track whether reports are acknowledged, resolved and fed into tests or training.

Prepare incident response and recovery

Define who can disable a feature, revoke a tool permission, revert a prompt or model, notify affected people, preserve evidence and communicate status. Exercise the procedure. Recovery should address already-issued outputs or actions, not only restoration of service.

Control changes and retirement

Route model upgrades, prompt edits, data refreshes, new integrations and policy changes through change management. Re-run the tests affected by the change and update the decision record. Keep a retirement plan that covers data retention, user migration, audit access and secure decommissioning.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Common evaluation mistakes

  • Using one benchmark as a safety certificate: a benchmark measures its defined task and conditions, not every harm or workflow.
  • Testing the base model but not the application: retrieval, prompts, tools, permissions and interface behavior can create new risks.
  • Optimizing only average performance: inspect severe tails, subgroup differences, uncertainty and recoverability.
  • Letting the test set become training material: maintain a protected holdout and document contamination controls.
  • Ignoring misuse and adversarial behavior: ordinary user tests do not probe prompt injection, extraction or policy bypass.
  • Declaring success without an owner: every residual risk and monitoring alert needs an accountable person and response deadline.
  • Stopping at launch: drift, user adaptation, dependency changes and incidents can invalidate pre-release evidence.
  • Inventing a universal threshold: acceptance criteria must match the use case, consequences and organizational tolerance.

Know the limits of this framework

NIST’s materials are cross-sector risk-management guidance. A medical, financial, employment, transportation or safety-critical deployment may require additional validation standards, professional review, privacy obligations, cybersecurity controls and approval from a regulator or competent authority. The framework does not certify a model, endorse a provider or guarantee that a system is safe.

Use the current NIST pages and documents directly: the AI RMF overview, AI RMF FAQs, AI Risks and Trustworthiness, AI RMF Core, ARIA, Evaluating Generative AI Technologies and the Generative AI Profile. The overview page currently notes that the framework is being revised, so check for updated editions when maintaining your evaluation program.

A practical readiness checklist

  • The deployed system, users, data, tools, permissions and prohibited outcomes are documented and versioned.
  • Stakeholders, failure modes, severity, likelihood, detectability and recovery are mapped.
  • Acceptance criteria were set before final results and reflect the organization’s risk tolerance.
  • Representative and holdout data, subgroup coverage and known limitations are documented.
  • Quantitative tests, expert review, model testing, red-teaming and—when appropriate—a bounded field test are complete.
  • Failures, uncertainty, mitigations and retest results are in a traceable register.
  • The decision record names scope, owners, residual risks, controls and reassessment triggers.
  • Monitoring, feedback, appeal or override, incident response, rollback, recovery, change management and decommissioning are operational.
