There is no universally best model for nonlinear time series. Start with naïve and statistical baselines, identify exactly what is nonlinear, then compare nonlinear, machine-learning, probabilistic, and hybrid candidates with leakage-safe rolling backtests at the horizon you will actually forecast. Choose the method that delivers the required accuracy and uncertainty quality at an acceptable compute, latency, interpretation, and maintenance cost.
A complex model that fits historical data closely is not automatically a better forecaster. The right choice depends on the data-generating structure, available inputs, forecast horizon, error costs, and how the model will operate after deployment.
What “nonlinear” means in a forecasting problem
“Nonlinear” is not a model family. It can describe several different situations, and each points to a different shortlist.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
- Nonlinear dynamics: the next value depends on previous values through thresholds, saturation, or other nonlinear equations.
- Changing relationships: a predictor’s effect varies with its level, time, or another variable.
- Interactions: two or more features matter jointly in a way that a simple additive model cannot represent.
- Regime shifts: the process behaves differently during distinct states, such as normal and crisis periods.
- Nonlinear trend or transformation: growth, decay, or variance changes with the level of the series.
Apparent nonlinearity can also come from data errors, outliers, an omitted intervention, a changing seasonal pattern, or a target that should be transformed. Diagnose the source before choosing an algorithm. MathWorks’ system-identification documentation distinguishes nonlinear ARX and nonlinear grey-box models from linear and state-space approaches; those nonlinear models are most useful when you can specify meaningful inputs or system structure, not merely because a plot looks curved.

Define the forecast contract before selecting a model
Write down the conditions under which the forecast will be produced. This prevents a model from winning an artificial test that does not resemble production.
- Target: the exact quantity, units, aggregation, and transformation to forecast.
- Timestamp and frequency: for example, hourly, daily, or monthly observations, including the time zone and treatment of daylight-saving changes.
- Forecast origin and horizon: when information is cut off and how many steps ahead are required. A one-step forecast and a 30-step forecast are different problems.
- Update schedule: how often predictions are refreshed and how often the model can be retrained.
- Available information: lagged target values, related series, calendar variables, external drivers, and which future covariates are known at forecast time.
- Decision and loss: the action that consumes the forecast and the relative cost of under-forecasting, over-forecasting, stockouts, excess capacity, or missed service levels.
- Operational limits: maximum inference latency, compute budget, required explanation, and tolerance for missing or late inputs.
These details determine the candidate methods and the evaluation metric. They also expose impossible promises: a model cannot use a future variable that will not be known when the forecast is issued.
Inspect the series and identify the structure
Use plots and diagnostics before fitting complex candidates. Examine the level, first differences, seasonal lags, residual variance, missing values, outliers, zero runs, and known interventions. Compare behavior across time segments rather than relying on one global summary.
Check seasonality and trend
Look for one or more repeating cycles and test whether their amplitude or timing changes. A single seasonal period may support seasonal-naïve or SARIMA models; multiple cycles may require explicit decomposition. Microsoft Fabric documentation describes MSTL as separating trend, multiple seasonal components, and a remainder. It is a candidate when the history is long enough to contain the cycles and backtests show that those cycles persist.
Check sparsity and intermittent demand
Count zeros and measure the distribution of nonzero intervals and sizes. A series with frequent zeros is not well described by an average-error score alone. Evaluate whether the decision depends on the timing of demand, the nonzero quantity, inventory cost, or a service-level threshold.
Check breaks and interventions
Mark policy changes, product launches, outages, price changes, and other events. A random train/test split can place observations from the same regime in both sets and produce an over-optimistic result. No method can reliably infer an entirely unobserved future break from the series alone; the best defense is testing across several historical regimes and adding known drivers when they are genuinely available.
Check relationships and covariates
Determine whether related series, calendar variables, prices, weather, promotions, or other inputs are available at the forecast origin. If future values are unknown, either forecast them separately, use scenarios, or exclude them. A large number of timestamps in one series does not replace the training diversity provided by many related series.

Keep honest baselines
Every nonlinear candidate should compete against simple methods. Include a last-value naïve forecast and, where appropriate, a seasonal-naïve forecast that repeats the value from the corresponding prior season. Add at least one straightforward statistical benchmark such as ETS (including Holt-Winters variants) or ARIMA/SARIMA.
Baselines answer two practical questions: whether the apparent nonlinear structure adds predictive value and whether the extra maintenance is justified. Do not discard a baseline because it seems too simple. If a sophisticated model cannot beat it consistently at the deployment horizon, the baseline is usually the safer production choice.
Shortlist methods by data structure
| Data or need | Candidate starting points | Checks before adoption |
|---|---|---|
| Stable level, trend, or regular seasonality | Naïve or seasonal-naïve, ETS/Holt-Winters, ARIMA/SARIMA | Whether seasonality persists, whether trend should be damped, and whether the baseline remains competitive. |
| Multiple seasonal cycles | Seasonal decomposition or multiple-seasonal models such as MSTL | Enough history for each cycle and performance across changing seasons. |
| Sparse or intermittent observations | Intermittent-demand or distributional baselines; NPTS is one platform-documented candidate | Zero and nonzero behavior separately, plus inventory or service-level loss. |
| Nonlinear dynamics with domain equations or meaningful inputs | Nonlinear ARX or nonlinear grey-box models | Input availability, parameter stability, physical interpretation, and extrapolation behavior. |
| Many related series and useful covariates | Global tree-based, neural, or probabilistic models, compared with local baselines | Cross-series scaling, cold starts, future-covariate availability, calibration, and leakage. |
| Abrupt regimes or changing relationships | Regime-aware, feature-based, rolling-window, or adaptive candidates | Backtests spanning multiple regimes and a plan for drift. |
| Long horizons or uncertainty-sensitive decisions | Direct multi-horizon and probabilistic or quantile models, plus combinations | Horizon-specific error, interval coverage and width, and recursive error accumulation. |
This is a starting shortlist, not a ranking. AWS describes CNN-QR and DeepAR+ as suited to large collections of related series, and describes NPTS for sparse or intermittent data; those are vendor-specific suitability statements, not universal rules.
Understand what each method family contributes
ETS and Holt-Winters
Exponential smoothing models level, trend, and seasonality with different update rates. They are strong first choices for stable, mostly univariate patterns and are inexpensive to retrain. Test additive versus multiplicative seasonality and damped versus undamped trend. Multiplicative forms require positive values and can behave poorly near zero.

ARIMA models autocorrelation after differencing; SARIMA adds seasonal terms. They are useful when lag relationships and seasonal structure are stable and the number of series is modest. Verify residual behavior and compare against seasonal-naïve and ETS rather than assuming the larger parameterization is better.
Multiple-seasonal decomposition
MSTL-style decomposition separates trend, several seasonal components, and remainder before forecasting those components. It can simplify a series with, for example, daily and weekly cycles, but it needs sufficient history and should be validated during periods when the cycles change.
Nonlinear ARX and grey-box models
Nonlinear ARX represents the target as a nonlinear function of lagged outputs and inputs. A nonlinear grey-box model embeds domain equations and estimates unknown parameters. These approaches are attractive when engineering or scientific knowledge provides a defensible structure and interpretability matters. Check identifiability, parameter stability, sensitivity to initial conditions, and behavior outside the range used for fitting.

Feature-based machine learning
Tree-based or other supervised models can represent nonlinear effects and interactions among lags, rolling statistics, calendar variables, and external drivers. Build features using only information available at each forecast origin. A model that uses a centered moving average, a revised value, or a future promotion flag that was not known at prediction time has leakage even if its code runs correctly.

Global neural and probabilistic models
Global models learn from many related series and can share statistical strength, which is valuable when each individual series has limited history. Neural or probabilistic approaches can produce quantiles or distributions, but they require careful scaling, sufficient examples, and robust handling of missing inputs and cold-start series. Compare their calibration and operational cost with local statistical models. More parameters do not guarantee better long-horizon forecasts.
Combinations
Combining forecasts can reduce dependence on one misspecified model. Use combinations only when rolling validation shows stable gains across relevant series and horizons; an ensemble that wins on one aggregate score but fails for an important subgroup may be unsuitable.
Backtest as the model will run
Use time-ordered validation. Hold out future periods and evaluate at multiple rolling forecast origins whenever possible. Microsoft Learn states: “A best practice procedure for evaluating a forecasting model is to roll the trained forecaster forward in time over the test set, averaging error metrics over several prediction windows.”
- Reserve a final future block. Keep a period untouched while you select models if the comparison is extensive. Use it once for an unbiased final check.
- Choose forecast origins. Place origins throughout the historical period, including different seasons and regimes. Use expanding windows when all prior data would be available in production, or rolling windows when old data should be forgotten.
- Recreate the information set. At each origin, fit preprocessing, feature calculations, and model parameters using only data available then. Supply future covariates only when the deployment process will know them.
- Forecast the actual horizon. If production needs 14 days, evaluate 14 days. Report each step or horizon bucket; a model can be excellent at one step and deteriorate rapidly farther out.
- Aggregate uncertainty carefully. Average errors across windows, but also show their spread and results by series, subgroup, and regime. Microsoft notes that estimates can be noisy when the test period is short relative to the forecast horizon.
- Lock the comparison protocol. Use identical origins, horizons, and information rules for every candidate. Do not tune one model on a future period that remains hidden from another.
Choose metrics that reflect the decision
MAE is easy to interpret in the target’s units and weights all absolute errors linearly. RMSE penalizes large misses more heavily and can be useful when extreme errors are particularly costly. Percentage metrics can be misleading or undefined when actual values are zero or near zero; do not use them as the sole score for sparse data.
Outdated Drivers Are Slowing You Down
One free scan finds every outdated or missing driver and matches the right update for your exact hardware.Free scan · exact hardware matchPC Slower Than It Used to Be?
A free scan shows the junk files, broken settings and background clutter dragging Windows down - then fixes them in one click.Free scan · Windows 10 & 11Select a primary metric from the business loss and data scale, then report complementary diagnostics. For intermittent demand, separate zero-versus-nonzero performance and assess inventory, fill-rate, or service-level outcomes when those drive the decision. For capacity or staffing, an asymmetric loss may be more appropriate than a symmetric average error.
Evaluate intervals and quantiles when uncertainty matters
Point forecasts are insufficient when decisions depend on risk. Compare prediction-interval coverage and width, or quantile loss at the levels used for planning. A narrow interval that misses the target frequently is not useful; a very wide interval may be technically calibrated but operationally impractical. M4 evaluated prediction intervals as well as point forecasts, reinforcing the need to assess both when uncertainty affects action.

Account for horizon and forecasting strategy
Recursive forecasting predicts one step, feeds that prediction back as an input, and repeats. Errors can compound as the horizon grows. Direct multi-horizon models predict each required step separately and may avoid some accumulation at the cost of more models or parameters. Compare both strategies at the real horizon rather than inferring long-range behavior from one-step accuracy.
Report horizon-specific results. A method that wins at steps one through three but loses badly at steps 14 through 30 may be unsuitable even if its average score looks good. If decisions use several horizons, select or combine models with that profile in mind.
Use evidence from broad benchmarks carefully
The M4 competition evaluated 100,000 time series and 61 forecasting methods in the International Journal of Forecasting (2020), including prediction intervals. The paper reported poor accuracy among pure machine-learning submissions in that particular competition and noted that the top three point-forecast methods used information from multiple series to inform method selection or forecast-combination weights.
That result is historical and competition-specific, not a general verdict against machine learning. It supports a disciplined comparison across methods, the use of cross-series information when appropriate, and testing combinations. Your data frequency, horizon, covariates, loss function, and implementation can produce a different ranking.

Create a comparison record for every candidate with the following fields:
- Rolling-origin error at the actual deployment horizon.
- Performance by series, customer or product subgroup, season, and historical regime.
- Interval coverage, width, and quantile loss when probabilistic forecasts are required.
- Robustness to missing values, delayed covariates, scale changes, and new series.
- Ability to encode domain constraints or explain important drivers.
- Training time, inference latency, hardware requirement, retraining frequency, and maintenance burden.
- Failure behavior: whether the system can fall back to a baseline when an input or model is unavailable.
If two methods are practically indistinguishable on the decision metric, prefer the simpler and more maintainable one. A small average improvement may not justify a large increase in operational risk.
Common failure modes and fixes
Randomly splitting a time series
Symptom: validation is unusually strong but production accuracy drops. Fix: replace random splits with chronological rolling origins and reproduce the production information set.

Optimizing one-step error for a long-horizon task
Symptom: near-term accuracy is good while later steps drift or become unstable. Fix: train and evaluate for the actual horizon, compare recursive and direct strategies, and inspect each horizon separately.
Using percentage error with zeros
Symptom: scores are undefined, extreme, or dominated by a few near-zero observations. Fix: use scale-aware metrics and decision loss, and analyze zero and nonzero events separately.
Adding unavailable future features
Symptom: offline performance depends on promotions, weather, or revised measurements that are not known at forecast time. Fix: forecast those inputs, use scenarios, or remove them from the production feature set.
Assuming a historical break will repeat
Symptom: a model performs well in one regime and fails after a structural change. Fix: validate across regimes, use known intervention variables, consider rolling or adaptive training, and monitor drift.
Choosing a global model without enough related data
Symptom: a neural or pooled model underperforms local baselines or fails on new series. Fix: check the number and similarity of related series, scaling, cold-start behavior, and whether shared patterns are actually present.
Trusting a single aggregate score
Symptom: the overall winner causes unacceptable errors for a critical subgroup. Fix: set subgroup guardrails, inspect error distributions, and select using the real decision priorities.
Operationalize and monitor the selected method
Before deployment, document the training window, feature definitions, forecast horizon, retraining trigger, fallback baseline, and alert thresholds. Log the forecast origin, inputs, model version, point prediction, intervals or quantiles, and eventual outcome.
After deployment, monitor forecast error by horizon and subgroup, input missingness, feature distributions, the frequency of fallback use, interval coverage, and changes in zero rates or seasonal behavior. Retrain or revisit the shortlist when the data process, available covariates, forecast horizon, or business decision changes. Model selection is not permanent: a method that was appropriate under one regime can become inappropriate after the process changes.
