Distillation changes the training target, pruning removes parameters or structures, and quantization uses fewer bits to represent the values that remain. They solve different bottlenecks and can be combined. Quantization is often the quickest first experiment when a runtime supports lower-precision arithmetic; pruning is useful when the runtime can exploit sparsity or when very high compression is required; distillation is appropriate when you can train a smaller or specialized student model. The right choice is the one that delivers acceptable task quality, model size, latency, memory and energy on your actual device—not the method that wins a paper’s benchmark.

The three techniques at a glance

All three methods are commonly discussed as model compression, but they act at different points in the model lifecycle. The taxonomy in the 2017 survey A Survey of Model Compression and Acceleration for Deep Neural Networks treats pruning and quantization as parameter-reduction or parameter-sharing approaches, while knowledge distillation is a separate training-based approach.

Technique What changes What you need Typical benefit Main limitation
Knowledge distillation A student learns from a larger teacher’s predictions or other signals. Teacher outputs, training data and compute to train the student. A smaller or specialized architecture that retains useful behavior. Requires a training run; the student can lose capabilities the teacher had.
Pruning Weights, connections or structures are removed or made sparse. A trained model, a pruning procedure and runtime support for the resulting sparsity. Fewer stored non-zero parameters and, with suitable kernels, lower compute. Sparse parameter counts do not automatically produce faster inference.
Quantization Weights and sometimes activations use fewer numerical bits. A target precision supported by the deployment runtime; calibration or retraining may be needed. Lower bytes per parameter, memory use and potentially faster arithmetic. Rounding can reduce accuracy, and gains depend on hardware and format.

Because they change different things, the techniques are not mutually exclusive. A team can distill a student, prune that student and then quantize it, provided the combined quality and runtime behavior are measured.

What knowledge distillation changes

A teacher provides learning signals

In distillation, a high-capacity teacher model guides a smaller student during training. The student is optimized not only against the original labels but also against information from the teacher, such as predictive probabilities or intermediate signals. Those outputs convey relationships among classes that a one-hot label does not show. The student therefore learns behavior rather than receiving a literal copy of the teacher’s parameters.

The student can have a different architecture

Distillation is not deleting data from the original network. You choose or design a student with fewer layers, narrower layers, fewer attention heads, or another architecture suited to the target device. It may be specialized for one task or operating condition. Since the student is a newly trained model, its serialized size and latency are properties of that architecture, not simply the teacher’s size multiplied by a fixed factor.

When distillation is a good fit

  • You can retain access to a teacher’s outputs and the data needed to train a student.
  • A smaller or task-specific architecture is acceptable.
  • The deployment budget is constrained by more than parameter bytes—for example, by activation memory or unsupported operations in the teacher.
  • You are prepared to evaluate the student directly instead of assuming that matching the teacher’s headline accuracy is sufficient.

The trade-off is training cost and possible capability loss. A student can preserve the behavior needed for a defined task while omitting capabilities that are irrelevant or too expensive to reproduce.

What pruning changes

Unstructured sparsity

Unstructured pruning removes individual weights, leaving zeros in the original tensor shape. The number of non-zero parameters can fall substantially while the nominal layer dimensions remain unchanged. This representation is attractive when storage is the main constraint, but ordinary dense matrix multiplication may still process the zeros. Real latency and energy savings require sparse-aware kernels, a format that stores indices efficiently and hardware that can exploit it.

Structured removal

Structured pruning removes larger units such as channels, filters, neurons or attention heads. The resulting network can have genuinely smaller dense tensors, making speedups easier to obtain on general-purpose hardware. Removing whole structures can, however, perturb accuracy more than removing small individual weights and may require fine-tuning or architecture changes.

What the published numbers mean

Google’s 2017 study, To prune, or not to prune: exploring the efficacy of pruning for model compression, reported up to a 10× reduction in the number of non-zero parameters across its evaluated CNN and LSTM settings with minimal accuracy loss. That is a result for the architectures and procedures studied, not a guaranteed inference-speed multiplier or a product-wide claim. The same work reported that large sparse models could outperform smaller dense alternatives at the same memory footprint in its evaluated architectures.

What quantization changes

Fewer bits per value

Quantization replaces higher-precision numerical values with lower-precision representations. It can affect weights alone or both weights and activations. A common comparison is FP32 to INT8: 32 bits become 8 bits, so the raw weight storage is reduced by 4× (32 ÷ 8). The KD-Lib overview, KD-Lib: A PyTorch library for Knowledge Distillation, Pruning and Quantization, describes this arithmetic reduction. Actual model-file savings can be smaller because of metadata, scale factors, non-quantized layers and container-format overhead.

Post-training and training-aware approaches

Post-training quantization applies lower-precision representations after a model has been trained, often using representative data to calibrate ranges. It is attractive when you need a quick deployment experiment and have limited retraining time. Quantization-aware training incorporates the effects of rounding during training so the model can adapt; it costs more compute but can preserve quality when post-training conversion causes too much degradation.

Hardware determines the payoff

Lower bit widths reduce memory traffic and may increase throughput only when the target processor, accelerator and runtime provide efficient support. A model that is smaller on disk can still show little latency improvement if execution repeatedly converts values back to a higher precision or if only part of the graph is quantized. Benchmark the exact exported format on the exact device.

How the methods compare on the metrics that matter

Use the following axes when choosing among techniques. A paper’s compression ratio is not a substitute for measurements in your deployment environment.

Metric Distillation Pruning Quantization
Existing model transformation Requires training a student; the student may use a different architecture. Starts from a trained model and removes weights or structures, usually followed by fine-tuning. Can be applied after training or integrated into training, depending on the method.
Serialized storage Depends on the student architecture and its parameter count. Depends on sparse encoding, index metadata and whether zeros are omitted. Usually scales with bits per stored value; FP32-to-INT8 raw weights are 4× smaller.
Latency and throughput Usually improve when the student has fewer operations, but must be measured. Improve only when the runtime and kernels exploit the particular sparsity or structure. Can improve with supported low-precision arithmetic; conversion overhead can erase gains.
Accuracy or task quality Depends on teacher signals, student capacity and data. Can fall as more parameters or structures are removed; fine-tuning can recover quality. Can fall because of rounding and limited dynamic range; sensitivity varies by layer and task.
Memory and energy Lower if the student reduces weights and activations enough. Lower when sparse storage and execution are efficient. Lower memory traffic is a common benefit; energy depends on the device’s low-precision units.
Implementation effort Highest when a teacher pipeline and student training run must be built. Moderate to high; requires selecting a sparsity pattern and validating kernels. Often the quickest first trial, but calibration, operator coverage and export details matter.

What comparative studies actually found

NeurIPS 2023: quantization versus pruning

The authors of Pruning vs Quantization: Which is Better?, presented at NeurIPS 2023, compared the methods across 8 large-scale models and 3 tasks. Their abstract states: “Our results show that in most cases quantization outperforms pruning.” The phrase “in most cases” is essential: the study also reports that pruning can be preferable at very high compression ratios. A later description of the work uses different counts, so the 8-model, 3-task figures here refer specifically to the NeurIPS proceedings page: Pruning vs Quantization: Which is Better?

Apple 2022: distillation, quantization and pruning for NLP

Apple Machine Learning Research evaluated 6 BERT architecture sizes on 8 GLUE tasks in Combining Compressions for Multiplicative Size Scaling on Natural Language Tasks. Its summary says: “Our work quantitatively demonstrates that combining compression methods can synergistically reduce model size, and that practitioners should prioritize (1) quantization, (2) knowledge distillation, and (3) pruning to maximize accuracy vs. model size tradeoffs.” That ordering is the recommendation from this BERT/GLUE study, not a universal ranking for vision, speech or every runtime. The study also found combinations could be complementary and sometimes super-multiplicative; pruning plus quantization was an exception to the general combination trend in that work. Read the scope and results at Combining Compressions for Multiplicative Size Scaling on Natural Language Tasks.

Google 2017: sparse models at a fixed memory budget

Google’s pruning work provides a different perspective from a simple dense-model speed contest. In its evaluated CNN and LSTM architectures, a large sparse model could outperform a smaller dense model occupying the same memory. This supports testing sparse capacity under a fixed storage budget, while still leaving open whether a particular production runtime can execute that sparse model faster.

Why the literature appears to disagree

“Compression” covers several objectives: fewer bytes, fewer arithmetic operations, lower peak memory, lower energy or a smaller training-and-serving footprint. A method can excel at one objective and disappoint at another. Quantization changes numerical precision; pruning changes the retained parameter pattern; distillation changes the learning process and can change the architecture. Comparing their percentages without matching the objective is misleading.

Results also depend on model family, task, compression ratio, calibration data, fine-tuning budget, sparse format and hardware. The NeurIPS study’s “most cases” result and its high-ratio pruning caveat, Apple’s BERT/GLUE ordering, and Google’s sparse-versus-dense memory comparison are findings under different setups. Treat them as evidence for experiments, not as conflicting laws that can be averaged into one universal winner.

A practical decision guide

Choose quantization first when bytes per parameter are the bottleneck

Start here when your target runtime explicitly supports the precision you want and the immediate problem is model-file size, weight memory or memory bandwidth. Try post-training conversion first if you need a fast result. If quality drops beyond your tolerance, use calibration with representative data or move to quantization-aware training. Record the exported format, operator coverage and any fallback layers so that the benchmark reflects the real graph.

Choose pruning when sparsity can be executed or compression must be extreme

Pruning is a candidate when your accelerator and inference library support the selected sparse pattern, or when a very high compression ratio is more important than a simple dense implementation. Prefer structured removal when predictable dense-kernel speed matters. For unstructured pruning, verify that the sparse representation reduces memory and that sparse kernels beat the dense baseline on the target device.

Choose distillation when a smaller or specialized model is acceptable

Use distillation when teacher predictions, data and training compute are available and the deployment problem is best solved by a different student architecture. Define the student’s required capabilities before training. Measure its task quality directly, including error categories that matter to users; matching one aggregate score does not prove that all teacher behaviors were retained.

Try combinations when one method misses the budget

A common sequence is to train a student, apply structured or unstructured pruning, then quantize the resulting model. Other orders can work, but each stage can change the calibration and accuracy of the next. The Apple NLP study found complementary combinations, while noting pruning-plus-quantization as an exception to its general trend. Validate every stage on the final hardware rather than multiplying the individual headline compression ratios.

How to run a deployment-focused comparison

  1. Freeze a baseline. Export the current model in the exact runtime format and measure task quality, serialized size, peak memory, warm and steady-state latency, throughput and energy if energy is a requirement.
  2. Define constraints. Set an allowed quality loss, maximum file and RAM sizes, latency or throughput target, supported operators, and whether retraining data and compute are available.
  3. Build a quantized candidate. Select the runtime-supported precision, calibrate or train as required, export it, and check for layers that silently remain at higher precision.
  4. Build a pruning candidate. Select a sparsity pattern, prune gradually or in a planned schedule, fine-tune, export the sparse or structured representation, and confirm that the runtime actually uses it.
  5. Build a distilled candidate. Choose the student architecture, train it with teacher signals and labels, and evaluate the student without invoking the teacher during inference.
  6. Test combinations only after single-method baselines. Keep the same evaluation set and hardware so that any gain can be attributed to the combination rather than a changed benchmark.
  7. Choose by the bottleneck. Select the candidate that meets all hard limits with the best quality and operational cost, not the one with the largest nominal parameter reduction.

Common failure modes and fixes

“The sparse model is smaller but not faster”

The model may still be stored in a dense tensor, or the runtime may lack kernels for its sparsity pattern. Export a supported sparse format, inspect execution traces for dense fallbacks, and compare structured pruning if predictable speed is required.

“INT8 reduced the file, but accuracy fell sharply”

Sensitive layers, activation ranges or insufficient calibration can cause large errors. Calibrate with data representative of production, leave especially sensitive operations at a higher precision when supported, or retrain with quantization-aware methods. Recheck quality after the exact export step.

“The distilled student matches average accuracy but fails users”

Aggregate metrics can hide regressions on rare classes, long inputs or safety-critical cases. Expand evaluation by segment, inspect confusion patterns and adjust the student capacity or training signals for the failed behaviors.

“Combining ratios looked spectacular on paper but missed the target”

Ratios are not generally multiplicative in deployed files or latency. Metadata, uncompressed layers, activation memory, conversion operations and unsupported kernels all matter. Measure the final artifact and retain each intermediate checkpoint so you can identify which stage caused the loss.

Bottom line: match the method to the constraint

Quantization changes representation, pruning changes the parameter structure, and distillation changes how a smaller model learns. Quantization is usually the most direct first test for a byte or memory problem; pruning earns its place when sparsity is executable or compression must be very high; distillation is the strategic choice when you can train a purpose-built student. They can be combined, but only target-device measurements of quality, size, latency, memory and energy reveal which design is best for your application.
