An agentic data factory is a proposed architecture for turning operational data into governed analytical datasets that AI agents can discover and use. Instead of repeatedly asking an agent to find source tables, infer business definitions, and rebuild metrics, the factory prepares reusable data products and exposes them through task-specific interfaces. Parquet, DuckDB, and MCP can form one implementation of that design, but the pattern is not a proven universal best practice, and the available documentation does not establish a quantified improvement in correctness or performance.
Why put a data factory between agents and operational systems?
Giving an agent database credentials does not give it a reliable analytical interface. It may still need to discover schemas and relationships, locate the right tables, write SQL, reconstruct business definitions, and recalculate metrics. Those tasks can be repeated across agents and queries, while source application tables may not express the intended analytical meaning.
The factory design moves much of that preparation into a governed data layer. It aims to make approved datasets—with stable purposes, business context, and quality information—available to dashboards, reports, APIs, and agents. This is an architectural rationale, not a measured claim that the approach eliminates errors or is better than every alternative.
How the proposed data factory works
The flow is a sequence from controlled source access to reusable analytical products. It can be implemented as a set of pipeline stages rather than as one monolithic service.

- Connect to source systems: use scoped, read-only access for ingestion and investigation rather than giving an agent unrestricted production credentials.
- Discover structure: identify schemas and relationships needed to interpret the source data.
- Clean and join: transform source records into datasets suited to analysis.
- Define business logic: record metrics and KPI rules so they are not reconstructed differently for each request.
- Materialize products: save refined analytical datasets for downstream use.
- Profile and validate: inspect output characteristics and run quality checks or anomaly detection.
- Add context: attach semantic and knowledge information that helps people and agents understand what the dataset represents.
- Serve approved access: make datasets available to dashboards, reports, APIs, and agents through appropriate interfaces, including MCP.
The sequence describes the source article’s proposed architecture. It does not prescribe a particular scheduler, storage layout, transformation language, or deployment topology.
What a reusable dataset should carry
In this design, a dataset is more than a file of rows. Its accompanying information should make the product interpretable, auditable, and safe to reuse. The source article presents these as design recommendations, not as a formal compliance checklist.
- Identity and purpose: a stable name and a clear description of what the dataset is for.
- Source context: the contributing sources and relevant relationships between them.
- Analytical meaning: dimensions, measures, and definitions for metrics or KPIs.
- Operational status: refresh status and history, so a consumer can understand how current the product is.
- Quality information: profiling results, checks, anomalies, and relevant annotations.
- Governance: permissions and usage rules appropriate to the data and intended tasks.
- Lineage: the analytical path from source data through transformations to the published product.
Without this context, an agent may be able to query a dataset but still misunderstand its meaning, freshness, or allowed use. The proposal is to make these details travel with the data product rather than leave them scattered across prompts and individual queries.

Separate investigation data from durable products
Not every useful query result deserves permanent storage or a place in a shared catalog. The design distinguishes temporary work from data intended for presentation or broad reuse.

This distinction lets teams explore without treating every experiment as permanent infrastructure. Promotion is the point at which the transformation and its operating expectations should become explicit.
Where Parquet and DuckDB fit
The proposed implementation pattern materializes refined products as Parquet and queries them with DuckDB. The pattern offers one way to package analytical data and make it queryable, but the available evidence does not establish it as the right choice for every workload, scale, or operating environment. The Apache Parquet documentation landing page was checked, but the material available here does not support adding detailed claims about format internals, compression, speed, or storage savings.

A concrete project example is the open-source MCP Data Server. Its repository describes serving SQL over Parquet through DuckDB, with dataset discovery grounded in STAC metadata. Its documentation describes local operation for sensitive data and Kubernetes deployment for scale. These are that project’s implementation descriptions, not an independent comparison or performance evaluation.
For an engineering team, the useful decision is not simply whether Parquet and DuckDB are attractive technologies. It is whether the proposed materialization and query pattern fits the team’s refresh needs, data boundaries, deployment model, and operational requirements. Those trade-offs must be assessed in the team’s environment; the cited project description does not resolve them generally.

The source article recommends offering agents higher-level operations rather than exposing an unconstrained generic SQL endpoint as the default interface. Example operations include listing available datasets, profiling a dataset, running bounded queries, retrieving defined metrics, and looking up related events. Such tools can retain dataset purpose, business definitions, and usage rules at the point of access. That is an architectural benefit the proposal expects, not an independently measured outcome.

DuckDB’s community extension listing documents a duckdb_mcp extension with client capabilities for connecting to MCP servers and reading resources, as well as server capabilities for publishing DuckDB tables or query results as MCP resources. The listing also documents command and URL allowlists and settings related to locking server configuration. These are capabilities described by the extension listing; they are not an independent security certification.
There is a practical distinction between two interface choices:
- Higher-level governed tools make a defined dataset or task the unit an agent can request. This can preserve context and constrain the intended operation, depending on how the tools are implemented.
- Generic SQL access gives more query flexibility, but requires teams to decide how to constrain queries, protect data, and ensure the agent has enough context to interpret results.
The choice need not be all-or-nothing. A team can expose task-specific tools for routine work and reserve broader query access for trusted, bounded environments. The available sources do not establish a universal interface design or prove that one option is more accurate.

Use refinement loops before promotion
A query that runs successfully has only demonstrated that it executed; it has not established that its output is analytically sound or sufficiently documented. The proposed workflow treats dataset creation as an iterative cycle:
- Plan the transformation and state the intended meaning of the output.
- Produce a candidate dataset from the selected source data.
- Inspect its profile and run relevant quality checks.
- Identify defects, unexpected patterns, or missing context.
- Revise the transformation or metric definition as needed.
- Validate again before promoting the dataset for durable reuse.
Profiling and validation belong before durable promotion, not just after an agent reports an unexpected answer. The sources describe this as a recommended process; they provide no controlled benchmark showing that a particular number of refinement cycles reduces errors by a measured amount.
Govern access and operations deliberately
The factory proposal recommends scoped, read-only source connections and moving analytical work away from repeated production queries. An MCP layer should expose approved datasets and narrow tasks under permissions and usage rules. These design choices can help define boundaries, but an MCP interface alone does not supply a complete security model.
The DuckDB extension listing’s documented command and URL allowlists are controls teams can consider. It also says command spawning defaults to deny-all unless an insecure opt-in is enabled. Those details should be checked against the extension version and configuration actually deployed; the listing’s capabilities should not be treated as a guarantee that a particular deployment is secure.
Teams still need environment-specific decisions for credentials, query limits, auditing, data exposure boundaries, and review of tools. Local operation or Kubernetes deployment, as described by the MCP Data Server project, does not by itself settle those questions. Security depends on the full deployment and the permissions and data reachable through it.
When this pattern is a useful fit
The architecture is most relevant when agents or other consumers repeatedly need the same curated data and business logic, and when teams want exploration to remain distinct from supported analytical products. Before adopting it, decide what the governed product boundary actually is: which datasets are approved, which metrics have canonical definitions, who can query them, and what makes a result eligible for promotion.
