To build generative AI for production in 2026, treat it as an application system—not a model call. Define the job and its risks, compare models on representative tasks, evaluate the complete workflow, add safeguards and human review where appropriate, then deploy and monitor every component that can affect an answer. The right design depends on the workload, users, and failure costs; there is no universally best model or deployment path.

Define the use case and its risk before choosing a model

Start with a specific user task and a measurable outcome. “Answer questions” is too broad to guide model choice or testing. A useful definition identifies what the application may answer, what it must decline or escalate, what information it can use, and what a successful result looks like.

Set boundaries and decide what happens when the system is wrong

  • Identify the intended users, the setting in which they will use the feature, and the kinds of inputs they are likely to provide.
  • List plausible failures: an incorrect answer, a fabricated detail, a missed instruction, disclosure of sensitive information, or an action taken on the wrong user’s behalf.
  • Assess the consequence of each failure. A low-impact drafting suggestion and an output that triggers a consequential action do not call for the same review process.
  • Decide whether a person must approve an answer or action, and at which decision points. Make escalation and correction paths clear to users.

Google Cloud’s development guidance says to assess organizational technical readiness—capabilities and infrastructure—before development. In practice, check whether the team can support the data, integration, security, evaluation, deployment, and ongoing monitoring the use case needs. If those capabilities are not available, narrow the scope or build them before relying on the feature in a critical workflow.

Choose a model and serving path for the workload

Shortlist candidates by what the application must do, not by a general ranking. Model modality, task quality, latency, throughput, full cost, data handling, and operational control can all change the choice. Larger models within a model family may cost more and respond more slowly; whether that trade-off is worthwhile must be tested on the task.

Decision area What to compare How to make the comparison useful
Task and modality Whether the model supports the required inputs and outputs, such as text, images, or other modalities, and how well it handles the actual task. Use representative examples, including difficult and unusual cases, rather than relying on a model description alone.
Quality Correctness, relevance, instruction following, appropriate uncertainty, and any task-specific requirements. Define the acceptance criteria before testing. Include human review for qualities that are difficult to score automatically.
Latency and throughput Response time and performance under the expected request pattern. Measure under representative load; a result from a single request does not establish behavior at production scale.
Cost The whole serving and application cost, including token-metered use or deployed-resource charges where applicable. Estimate against expected traffic and workload. Pricing depends on the service and can change, so verify current terms for the selected provider, region, and deployment.
Control and operations Managed versus self-managed deployment, access controls, monitoring support, operational workload, and the ability to roll back. Choose the level of control the team can operate reliably, not simply the one with the most configuration options.
Data and availability Supported regions, data handling terms, and required enterprise controls. Verify current provider documentation and contractual terms for the specific service; do not infer them from a model name.

Some services meter use by tokens, while deployed models may incur charges based on provisioned resources such as node hours. Those billing models are not directly interchangeable: estimate the expected cost for your usage pattern and verify current pricing before committing.

Compare candidates in the application, not in isolation

Run shortlisted models through the same task examples and application workflow. Include the retrieval, tools, formatting constraints, and other integrations that will shape production outputs. Record quality and latency alongside cost so a cheaper candidate is not selected without accounting for the extra retries, review, or correction it may require.

Choose the serving arrangement your team can maintain

A managed service can reduce infrastructure work, while a self-managed deployment may offer different controls and operational responsibilities. Evaluate both against data requirements, deployment constraints, capacity planning, monitoring, and rollback needs. The evidence here does not establish a cross-provider winner; availability, pricing, and service terms must be checked for the specific provider and region.

For Gemini projects specifically, Google’s guidance as of June 2026 describes the Gemini Developer API as the fastest route for most developers unless specific enterprise controls are needed, and positions the Gemini Enterprise Agent Platform as a broader Google Cloud ecosystem. Google also described the Interactions API as generally available and recommended for new Gemini projects as of June 2026, while continuing to support generateContent. These are provider-specific recommendations and may change; verify current API guidance before building against it.

Build an evaluation loop before release

Evaluation should be repeatable and tied to the task. A model that performs well on a few handpicked prompts may fail on different phrasing, incomplete context, or an input that exposes a safety weakness.

Create a representative test set

  • Collect diverse examples that reflect the actual task, user language, and expected input variation.
  • Include reference answers or explicit scoring criteria where a single reference answer is not appropriate.
  • Add cases for known failure modes, boundary conditions, and application-specific risks.
  • Keep evaluation examples separate from casual demonstrations so release decisions can be compared consistently over time.

Combine automated scores with human judgment

Automated metrics make it practical to test many examples, but they can oversimplify language quality and miss context or nuance. Use a range of measures relevant to the task, then have people review outputs that require judgment. Model-based side-by-side comparisons can speed up candidate review, but an evaluator model can have biases; they should not replace human evaluation.

Set release thresholds and compare changes side by side

Decide in advance what quality, latency, and safety results are acceptable for release. Test prompt, model, and configuration changes against the same evaluation set, and investigate regressions rather than averaging them away. For higher-risk uses, add adversarial tests aimed at misuse and foreseeable failure paths. A passing score is evidence about the cases tested, not proof that every production response will be safe or correct.

Design safeguards and human oversight around specific risks

Safety is an application property, not a setting that can be switched on once. Google AI for Developers notes, “However, each application can pose a different set of risks to its users.” Built-in model filters may help, but they do not remove the developer’s responsibility to understand likely harms and choose suitable mitigations.

Layer safeguards at the relevant points

Depending on the use case, controls may include input handling, model safety settings, output checks, misuse controls, limits on what integrations can do, and a route to human review. Select and test controls against the specific risks identified for the application; no single filter guarantees a safe result.

Make oversight usable

For outputs that need approval, give reviewers enough context to judge them, such as the user request and relevant source material. Define who can approve, correct, or escalate an output, and what the application does while a decision is pending. Provide a way for users to report errors or harmful results, and include those reports in ongoing review.

Reassess as use changes

New users, integrations, data sources, or capabilities can change the risk profile. Revisit the safety test set and mitigations when the application changes, and monitor for patterns that indicate a safeguard is failing. Safety benchmarks and adversarial tests can expose weaknesses, but performance can trade off across metrics and contexts; interpret results in light of the intended use.

Deploy the application as a versioned system

A production feature may connect models, databases, retrieval components, tools, and dynamic data pipelines. Each dependency can change the output or fail independently, so deployment planning must cover the whole system rather than only the model endpoint.

  1. Version the moving parts. Track application code, prompts, model identifiers, model settings, integrations, and relevant data or pipeline versions. Record enough information to reproduce or investigate a release.
  2. Test the integrated application in a production-like environment. Exercise the path from user input through retrieval and model calls to the final response or action. Check expected behavior when a component is unavailable or returns an unexpected result.
  3. Test operational behavior. Where relevant, test scalability, reliability, performance, and load using conditions that resemble expected use. Validate capacity assumptions before exposing the feature to its intended traffic.
  4. Configure access and endpoints. Set up authentication and authorization, endpoint behavior, and access to connected services. Grant only the permissions the application requires.
  5. Plan rollback and recovery. Keep a known-good configuration and define how to revert a model, prompt, integration, or application release if monitoring reveals a regression.

These controls matter because a prompt edit, model change, or data-pipeline update can alter outputs even when the rest of the application appears unchanged. Release them as changes to a production system, with tests and traceable versions.

Monitor quality, safety, and component lineage after launch

Production behavior can differ from a test set as users, inputs, and dependencies change. Monitor the dimensions that affect the application’s purpose: answer quality, safety signals, errors, latency, and resource use. Use feedback and observed failures to update evaluation cases and make controlled changes.

Keep logs useful for diagnosis

End-to-end logging should cover the application and its components. Maintain lineage that connects an output to the relevant input, components executed, and their parameters or artifacts. This helps teams investigate an inaccurate result and distinguish a model issue from a retrieval, integration, configuration, or data problem.

Logging also needs to fit the application’s privacy and data-handling requirements. Decide what information is necessary to diagnose failures and who may access it; do not collect or retain user data without an appropriate basis and controls.

Turn incidents into controlled improvements

When a failure occurs, identify the component and change most likely to have caused it, add a representative case to evaluation where appropriate, and test a proposed fix before release. Roll back when needed, then monitor the corrected version. This closes the loop between real use and the test process without treating every user report as proof of a general model defect.

Use a release gate that matches the consequences

Before exposing the feature to its intended users, confirm that the team can explain what it does, how it can fail, and how it will be maintained.

  • The use case, user population, and failure consequences are documented.
  • Model and serving choices have been compared on representative quality, latency, cost, data, and operational requirements.
  • The evaluation set covers normal use, variation, and relevant edge or adversarial cases, with human review where needed.
  • Safeguards and human-review paths are tested for the specific risks, not assumed to work because they are enabled.
  • Integrated tests, access controls, capacity planning, monitoring, lineage, and rollback are in place for the components that affect outputs.
  • Owners know how to review feedback, investigate incidents, and update tests and configurations as the application evolves.
