Keep validation and test data representative of the data the model will face in use, and judge results by per-class precision and recall—not accuracy alone. There is no single correction that works best for every classification problem.
What an unbalanced dataset means
In classification, an unbalanced dataset—also called class imbalance—has different numbers of examples in its classes. A classifier can favor the majority class, but imbalance alone does not prove that the model is failing or that the data should be made equal in size. The imbalanced-learn introduction describes this risk and outlines ways to address it.
The right choice depends on what errors matter, how well each class is represented, and how the model will be used. Making every class equally common can discard useful information or cause the model to behave unlike it will in deployment.
Check the labels and class counts first
Before changing the training data, verify that apparent imbalance is real and that the labels are trustworthy.

- Read Before You Buy — No Video Output: These adapters support charging and USB 2.0 data transfer, but cannot transmit video signals. Except for standard USB webcams (which use USB data only), they are not compatible with HDMI/DisplayPort cables, video-capable USB-C hubs, or docking stations with video output.
- Convert USB-A Ports to USB-C: Designed to connect USB-C earphones, cables, flash drives, card readers, and other USB-C accessories to standard USB-A ports. Plug-and-play with no drivers or software required.
- Aluminum Alloy Housing: Built with a sturdy aluminum alloy shell that aids in heat dissipation and protects against daily wear and scratches. Designed to maintain a stable and secure connection.
- Compact & Travel-Friendly: The ultra-compact design allows the adapter to stay plugged into your device without blocking adjacent ports or adding bulk, reducing wear and tear on your original USB ports.
- 12-Month Warranty: Backed by a 12-month manufacturer warranty for peace of mind. Designed to meet strict quality control standards for reliable everyday performance.
- Count examples in each class, including within relevant time periods, groups, or data partitions.
- Check for missing, inconsistent, or incorrectly assigned labels.
- Ask whether the data collection process misses some cases or whether a class is especially difficult to label reliably.
- Consider whether the class proportions in the dataset reflect the cases the model will encounter in use.
An imbalance ratio describes how uneven the counts are; it does not determine which remedy to use.
Define what a good result means and set a baseline
Decide which errors are costly before selecting a metric or changing the data. In one application, missing a positive case may be worse than raising a false alarm; in another, excessive false alarms may be the greater problem. Set practical targets where possible, such as a minimum recall or a maximum alert volume.

Fit a baseline model on the original training data and record a confusion matrix, per-class precision and recall, and an overall metric. Accuracy can look high when a model predicts the majority class well but performs poorly on a less common class. Balanced accuracy—the average recall across classes—gives each class equal weight in that summary. Scikit-learn explains this and other classification metrics in its metrics and scoring documentation.
Keep evaluation data representative
Set aside validation and test data before resampling. Use validation results to compare approaches, then reserve the test set for a final assessment. Evaluation data should retain the class distribution expected in use; scores on artificially balanced data do not, by themselves, show how a model will perform on naturally distributed cases.

When using cross-validation, apply any sampler only within each training fold. Otherwise, information from examples that should be held out for validation can influence the resampled training data. Preserve groups or time order when random splitting would break the way predictions will be used—for example, when future records must be predicted from past records.
Compare justified ways to handle imbalance
Keep the original-data baseline in the comparison. Use the same validation protocol for each option, and select methods based on class-specific results and the application’s error costs.

| Approach | What changes | When it may be worth testing | Trade-off to check |
|---|---|---|---|
| Class or sample weighting | The model assigns different importance to examples during fitting; the training examples are not duplicated or removed. | When the model supports weights and errors on particular classes need greater influence. | More weight can improve attention to a class but may worsen precision or results for other classes. |
| Random oversampling | Minority-class examples are repeated in the training data. | When retaining observed feature values is important and repeating available examples is an acceptable experiment. | Repeated examples add no new information and can encourage overfitting. |
| Synthetic oversampling, such as SMOTE | New training examples are generated from minority-class examples. | When the feature representation and available minority examples make the method’s assumptions plausible. | Synthetic examples are not new ground truth; check that generated cases are meaningful for the data. |
| Undersampling | Some majority-class training examples are removed. | When the majority class is large enough that reducing it is a reasonable trade-off. | Discarding examples can remove useful variation. |
| No resampling | The original class distribution is retained during fitting. | When the baseline already meets the application’s class-specific requirements, or as a reference for comparison. | Minority-class results still need to be checked rather than assumed adequate. |

For multiclass metrics, state whether an average is macro or weighted. Macro averaging gives every class equal influence; weighted averaging gives more influence to classes with more examples and can therefore obscure poor performance on a small class. Review per-class results either way.
If training uses resampling, the model sees a class distribution that may differ from deployment. Check whether its predicted probabilities and decision threshold remain useful at the real deployment prevalence. Choose thresholds against the application’s error costs using validation data, not by tuning against the final test set.
Quick Recap
A practical decision sequence
- Audit: Verify class counts, label quality, and how data collection represents the cases of interest.
- Specify costs: Decide which classes and errors matter and set operational targets where possible.
- Baseline: Train on the original training distribution and record per-class metrics and a confusion matrix.
- Protect evaluation: Keep representative validation and test data untouched by resampling; put samplers inside training folds during cross-validation.
- Compare: Test suitable weighting and resampling options against the baseline using the same validation setup.
- Select and report: Choose the option that meets the task’s requirements, then document per-class results, the averaging method, and the evaluation distribution.
