That makes recurrent layers useful for data such as text and time series. The right choice among a vanilla RNN, an LSTM, a GRU, or a bidirectional model depends on how far information must travel, whether future inputs are available, and which model performs best on held-out data.
What is a recurrent neural network?
An RNN is a neural-network architecture designed for ordered data. At each timestep, it combines the current input with a hidden state from the previous step. The hidden state is an internal representation that carries forward information the model may need from earlier in the sequence; it is not a verbatim copy of the sequence or a guarantee that every past detail is retained.
For example, when processing a sentence, the model receives tokens in order. Its state is updated as each token arrives, and the resulting state or timestep outputs can be used for a prediction. For a time series, the inputs might instead be successive measurements. TensorFlow describes RNNs as a class of neural networks suited to sequence data such as time series or natural language (TensorFlow’s guide to working with RNNs).
How does an RNN carry information across a sequence?
At each step, a recurrent layer applies the same recurrent computation to the current input and the preceding hidden state. This repeated connection gives earlier inputs a route to affect later states and outputs. Depending on the task and layer configuration, a model may use the final output, outputs at multiple timesteps, or both.

RNNs are typically trained with backpropagation through time (BPTT). In effect, the recurrent computation is unfolded across sequence steps, and the training algorithm propagates gradients backward through those steps to adjust the model’s parameters. This links the behavior of early inputs to learning signals arriving later in the sequence.
Why long-range dependencies are difficult
As gradients are propagated backward over many timesteps, they can shrink toward zero or grow excessively. Vanishing gradients make it difficult for earlier steps to influence learning; exploding gradients can destabilize training. These issues are among the reasons a basic RNN can struggle to learn long dependencies.

Gradient norm clipping can limit excessively large gradients and help address exploding gradients. It does not, by itself, fix vanishing gradients or ensure that a model learns long-term relationships. Gated architectures provide different mechanisms for controlling information flow, but they are not a guarantee of good results on every dataset.
RNN vs. LSTM vs. GRU
These architectures all process sequences recurrently, but differ in how they maintain and update information. The distinctions help narrow down candidates; they do not establish a universal winner.

TensorFlow/Keras documents SimpleRNN, GRU, and LSTM layers; PyTorch documents RNN, LSTM, and GRU modules. Both provide options that affect how a recurrent layer is used. Consult the current TensorFlow RNN guide or PyTorch GRU documentation for version-specific behavior and configuration.
When is a bidirectional RNN appropriate?
A bidirectional recurrent model processes a sequence in both directions, allowing its representation at a position to use context from earlier and later parts of the input. That can be useful for offline sequence labeling when the complete sequence is available—for example, when assigning labels to all positions in a finished input.

It is not suitable when a prediction must be strictly causal: if the model must produce an answer before future inputs arrive, it cannot rely on those future inputs. For streaming or real-time predictions, choose a design that uses only information available at the moment each prediction is made. Start with the task’s information flow and constraints, then compare candidates on the same data split and evaluation criteria. A more elaborate recurrent layer is not automatically more accurate or more practical.

- Define the prediction timing. If the model must make predictions as inputs arrive, use only past and current information. If the entire sequence is available before prediction, a bidirectional model may be considered.
- Estimate the dependency pattern. A vanilla RNN is a reasonable simple baseline for short dependencies. If the task may require information to persist across more steps, include LSTM or GRU candidates.
- Set practical constraints. Consider training and inference cost, sequence length, framework support, and the implementation details relevant to your deployment.
- Compare with appropriate alternatives. Evaluate recurrent candidates against suitable non-recurrent baselines where relevant, using held-out data and the metric that reflects the real task.
- Choose from measured results. Check predictive performance as well as runtime and reliability under the conditions in which the model will be used. Keep the simplest candidate that meets the requirements.
There is no architecture choice established as best for every sequential task. The useful evidence is how well each candidate meets the specific task’s constraints and performs on data it was not trained on.
