You do not need to master neural-network math before using an LLM. The preparation depends on your goal: using an existing tool takes little technical background; building applications or adapting models calls for practical coding and machine-learning skills; implementing and training a language model from scratch demands much stronger programming, math, and systems knowledge.
Start with the kind of LLM work you want to do
Use an existing LLM
You can start using hosted chat tools or model APIs without first learning calculus, linear algebra, or machine learning. For application work, useful skills include basic scripting, handling data, calling APIs, evaluating outputs, and recognizing model limitations. Add technical knowledge as your projects require it; a from-scratch course’s prerequisites are not a general entry barrier for using LLMs.
Build applications or adapt a model
Building on an existing model or fine-tuning one typically calls for Python, data preparation, and an understanding of basic machine-learning ideas such as training and evaluation. You will also need the framework and tools used by your specific workflow. More math helps when you need to diagnose optimization, loss, probability, or generalization problems, but the amount depends on how deeply you work with the model.
Implement and train a model from scratch
This is the most technically demanding path. Stanford’s CS336: Language Modeling from Scratch is a concrete example of an implementation-heavy course, not a universal prerequisite list for everyone learning about LLMs. Its published expectations include:

- Programming: proficiency in Python and software engineering. The course describes assignments with minimal scaffolding and substantially more coding than other AI courses.
- Frameworks and systems: strong familiarity with PyTorch, experience with deep learning and systems optimization, and basic systems concepts such as the memory hierarchy. The work includes making neural language models run efficiently on GPUs and across multiple machines.
- Math: college calculus and linear algebra, including comfort with vectors and matrices, plus basic probability and statistics, including probabilities, Gaussian distributions, mean, and standard deviation.
- Machine learning: comfort with the fundamentals of machine learning and deep learning.
CS336 is a five-unit Stanford class. That figure describes this course only; it does not measure the time or effort needed to learn LLMs generally.
What those skills let you do
CS336’s assignments illustrate the work that its prerequisites support: implementing a tokenizer, Transformer architecture, and optimizer; training a minimal model; profiling and optimizing attention; distributed training; scaling analysis; filtering and deduplicating pretraining data; and supervised fine-tuning and reinforcement learning. The Spring 2026 page also describes evaluation and alignment topics. This workload is a useful picture of from-scratch model work, not a checklist you must complete before using an LLM.

A practical learning order
The sequence below is a practical way to build toward implementation work; it is a synthesis of the skills described in CS336’s prerequisites, not a sequence Stanford prescribes.
- Learn practical Python. Write small programs, work with data, and debug your code.
- Study machine-learning basics. Understand supervised learning, the difference between training and evaluation, and core neural-network concepts.
- Build relevant math comfort. Work with vectors and matrices, probability, and the calculus ideas behind gradients and optimization.
- Practice with a deep-learning framework. Use a framework such as PyTorch and implement small models.
- Add systems skills for from-scratch training. Learn about memory use, GPU execution, profiling, and distributed computation.
You can begin at the level that matches your goal and fill gaps as they become relevant. A person writing an application around an existing model does not need to follow every step intended for someone building training infrastructure.

How to compare LLM courses and learning paths
Compare what learners will actually do, rather than assuming every course requires the same background. Look at these dimensions:
- Outcome: Does the course focus on using LLM applications, building applications around existing models, fine-tuning, or implementing and training models from scratch?
- Coding: Will you write short application scripts, train through high-level libraries, or implement model components and training infrastructure?
- Math and machine learning: Does the course teach the fundamentals, or expect prior calculus, linear algebra, probability, statistics, machine learning, and deep learning?
- Systems depth: Does it cover GPU performance, memory, profiling, and distributed training?
- Scaffolding and workload: How much starter code is provided, and how much implementation must you do independently?
CS336 falls in the from-scratch category: its assignments are implementation-heavy, and its published prerequisites are correspondingly substantial. Those expectations should not be mistaken for what is required to use an LLM or build every kind of LLM-powered application.
