Generative AI can help data scientists turn an analytical request into Python or SQL, build an editable notebook, interpret files and other media, and coordinate tools that run parts of an analysis. Its useful output is often not prose: it may be code, a chart, a query, or a model workflow. Treat those outputs as proposals to inspect and verify—not as proof that the analysis is correct.
For well-defined prediction tasks such as forecasting or classification, a conventional predictive model may still be the better core method. Generative AI can complement it when the work calls for language, content, or interaction with varied data.
What “beyond text generation” means in data science
A generative model can produce text, code, or other content, but a data-science workflow becomes more consequential when the system can also use tools. It might draft Python, execute it, make a chart, generate SQL for a database, or pass part of a request to a specialist agent. The analyst sees a conversational interface; behind it, the system may be manipulating data or invoking software.
Google Cloud’s reference architecture, last updated December 8, 2025, illustrates this pattern with separate agents for Python-based analytics, SQL against BigQuery or AlloyDB, and machine-learning operations in BigQuery ML. It is one vendor’s architecture example, not a universal design or evidence that every agent can perform those tasks reliably.

Where generative AI can fit in an analyst’s workflow
From a question to an editable notebook
A data scientist might upload a file and ask for a missing-value review, a trend visualization, or help selecting a statistical technique. In Google’s March 3, 2025 Colab announcement, its Data Science Agent was described as turning an analysis goal into a working notebook with code and imports. The notebook is useful as a starting point because a person can inspect and edit the code rather than accept an unexplained answer. Google also warned that the agent may make mistakes. The announcement described access for adults in select countries and languages at that time; that dated rollout should not be read as a statement of current availability.
From a question to SQL or a coordinated analysis
A request such as “compare monthly revenue by region” can require schema discovery, filtering, aggregation, and presentation. An agentic design can route database work to a SQL-capable agent, Python analysis to another, and model operations to an ML specialist. Google Cloud’s example uses BigQuery and AlloyDB alongside its Agent Development Kit and Cloud Run. This can divide work into manageable parts, but introduces handoffs and tool permissions that need oversight.

Working with images, audio, files, and other inputs
Generative workflows are not limited to rows and columns. AWS guidance discusses multimodal and unstructured data, while OpenAI’s April 16, 2025 system-card announcement described o3 and o4-mini capabilities involving Python, image and file analysis, browsing, and coding or scientific tasks. These are dated vendor descriptions of capabilities, not independent evaluations or guarantees of correctness. A multimodal system may help interpret an input, but the analyst still needs to know whether the interpretation is appropriate for the question and data.
Synthetic data as an aid, not a substitute for evidence
Generated data may help explore or accelerate a conventional machine-learning use case, as AWS notes. But synthetic examples are not automatically private, representative, or useful. A 2025 IEEE Access survey abstract on synthetic text and code identifies concerns including inaccurate text, inadequate distributional realism, and bias amplification. Evaluate whether synthetic data preserves the properties that matter for the intended task, and assess privacy risks separately.

When to use generative AI and when to use predictive modeling
Choose based on the output the work requires, not on which approach sounds newer. Google Cloud’s model-selection guidance distinguishes common uses for generative AI from structured prediction tasks, while noting that the approaches can be combined. The comparisons below are selection principles, not promises about any particular model’s accuracy or latency.

For a real selection, also consider data access, verifiability, code transparency, integration with the existing notebook and ML lifecycle, serving latency, and operational constraints. Google Cloud specifically flags anticipated outcomes, serving latency, and model metrics as factors in deeper model selection. A generative interface does not remove the need to establish appropriate metrics for the underlying analytical task.

How to validate AI-generated code and conclusions
Use a review routine proportionate to the stakes. The following steps are practical safeguards for executable analysis, not a formally validated universal checklist.
- Check the scope of access. Confirm the system used only the intended files, tables, and permitted data. Review any tool calls or data connections that are visible.
- Read the generated SQL and Python. Inspect joins, filters, units, null handling, data types, and transformations. Check that the query answers the question asked rather than a superficially similar one.
- Inspect the analytical choices. Ask whether the statistical method fits the question and the data. Look for leakage, unsuitable assumptions, small or biased samples, and visualizations that obscure scale or uncertainty.
- Run it in a reproducible environment. Execute the notebook or query yourself, preserve the code and dependencies, and record relevant inputs and assumptions. A plausible-looking output is not evidence that the code ran as intended.
- Compare results independently. Check known totals, simple baseline calculations, test cases, or a separate analysis. Investigate discrepancies rather than choosing the result that looks most convincing.
- Review the conclusion against the evidence. Trace each claim back to an output and confirm that uncertainty and limitations are represented. Fluent explanation is not a substitute for a valid calculation.
- Assign accountability for consequential work. Have a responsible reviewer document assumptions and approvals before the analysis informs a high-impact decision.
What changes when agents move into production
A notebook used by one analyst and an agent connected to business data have different risk profiles. AWS guidance highlights sensitive-information protection, access controls, hallucination, data poisoning, and adversarial risks; for agentic systems it also emphasizes identity management and traceability.

- Limit each agent or tool to the data and actions it needs, using least-privilege access.
- Make identity and permissions clear across the coordinator and specialist tools, rather than relying on a user’s conversational request as authorization.
- Monitor activity and preserve traceability for tool use, data access, and consequential outputs.
- Consider how malicious or corrupted inputs could influence prompts, retrieved context, or data used by the workflow.
- Use preparation and cleansing, and where appropriate retrieval-augmented generation (RAG) to bring in contextual information. Fine-tuning and feedback loops may also be part of an application’s lifecycle, but do not by themselves establish that its outputs are correct.
These controls do not make a model infallible. They make it easier to constrain what the system can do and to investigate what happened when an output is wrong.
