A very deep neural network is a model with many learned transformations stacked between its input and output. Early layers may detect simple patterns, while later layers combine them into richer representations. Depth can increase what a model represents, but adding layers does not automatically make training or accuracy better.
The central problem is optimization: during backpropagation, gradients can shrink as they travel through many layers, leaving early weights with updates too small to learn effectively. Residual networks address this with shortcut paths that let each block learn a change to its input instead of an entirely new representation.
What “deep” means
Think of a network as a chain of transformations. An image enters the first layer, which produces a representation for the next layer; that layer transforms it again, and so on until the output is produced. A deeper network has more such learned steps between input and output.
In a vision model, early transformations might respond to edges, later ones to textures or parts, and still later ones to object-level combinations. This is a useful picture, not a guarantee: an extra layer can be redundant, difficult to optimize, or harmful to generalization.

Why very deep networks are hard to train
Vanishing gradients
Backpropagation sends an error signal from the output toward earlier layers. The signal is repeatedly multiplied by derivatives associated with each transformation. If those factors are small, the gradient can become extremely small by the time it reaches the front of the network. Early layers then receive negligible weight updates and learn slowly.
Vanishing gradients are one important difficulty, not a complete explanation of every deep-network failure. Architecture, activation functions, initialization, normalization, optimizer settings, data and regularization all affect trainability.

Degradation from simply adding layers
A plain network can become harder to optimize when layers are added, even when the deeper model should be capable of representing the shallower solution. The 2016 DropIn study explored gradually introducing layers rather than presenting the full depth to the optimizer at once. Its experiments included an 11-layer CIFAR-10 architecture, a 13-layer AlexNet-style architecture and a 16-layer VGG architecture.
How skip connections help
A residual block has two paths. One path applies a learned transformation to the input; the other carries the input forward, usually unchanged. The block adds the learned residual to that shortcut:

output = input + learned change
This gives the block an easier fallback: if an additional transformation is not useful, it can learn a small change rather than reconstructing the entire input representation. The shortcut also creates a more direct route for information and gradient signals. It does not make gradients perfectly constant or eliminate every optimization problem.
He, Zhang, Ren and Sun’s ResNet work demonstrated the practical impact of this design, including a 152-layer residual network trained for ImageNet image recognition. “Very deep” is therefore context-dependent; those layer counts are examples from particular papers, not a universal threshold.

Depth, trainability and generalization are different
- Representational capacity: more transformations can build more complex features.
- Trainability: the optimization process must successfully learn useful weights through all those transformations.
- Generalization: the trained model must perform well on new data, not merely fit its training examples.
A deeper model can be trainable yet overfit, or difficult to train yet theoretically expressive. Depth alone is not evidence that a model will generalize better.

HSIC bottleneck
The HSIC bottleneck paper describes a different training approach intended to mitigate vanishing and exploding gradients without backpropagation, with experiments on MNIST, Fashion-MNIST and CIFAR-10. It is a research proposal, not a universal replacement for residual networks.
These methods should not be ranked directly from those results alone: they use different mechanisms, tasks and datasets.
