Zero-shot classification predicts labels it was not specifically trained on, but that does not make its uncertainty trustworthy by default. A reliable deployment needs two separate layers: calibration to make confidence values better match observed correctness, and (when appropriate) conformal prediction to return a set of plausible labels with a stated marginal-coverage target. A decision policy then determines whether to predict, abstain, or send a case to a human. Those layers answer different questions and must be validated on data that resemble deployment.
What zero-shot classification actually means
In zero-shot classification, a pretrained model is asked to choose among target categories without task-specific labeled examples for those categories. The model relies on knowledge learned during pretraining and on the way the labels are represented at inference time. In CLIP-style systems, for example, an image encoder produces an image representation and a text encoder represents category names or prompts. Similarity scores between the image and each prompt are converted into a ranking or probability-like output.
“Zero-shot” describes the absence of labeled training examples for the target task or labels; it does not mean that the model learned nothing. The pretrained model may have seen related concepts, language, or visual patterns. It also does not mean that the model knows when it is wrong. A model can assign a high score to an unfamiliar or shifted example, so uncertainty behavior must be measured separately.
Calibration and conformal prediction answer different questions
| Method | What it produces | What it is intended to answer | Key requirement or limitation |
|---|---|---|---|
| Confidence calibration | Adjusted probabilities or confidence values | When the model says 0.8, is it correct about 80% of the time in a comparable population? | It improves the interpretation of scores; it does not choose error costs or an abstention rule. |
| Conformal prediction | A set of candidate labels | How can I construct a set intended to contain the true label at a chosen marginal rate? | The usual split method needs a separate labeled calibration sample and gives marginal, not automatic per-class or subgroup, coverage. |
| Selective prediction or deferral | An action: predict, abstain, or refer | Which cases should be handled automatically, and which should receive review? | The threshold depends on the relative costs of wrong predictions, abstentions, and human review. |
Calibration changes how scores should be read. Conformal prediction uses calibration examples to construct a set with a user-chosen coverage target. A calibrated 0.9 score is still a single-model probability statement; a conformal set such as {cat, fox} communicates that several labels remain plausible under the selected procedure. Neither output is a blanket safety certificate.

How to tell whether a zero-shot confidence score is reliable
Measure reliability on held-out, deployment-like data
Collect labeled examples that resemble the cases on which decisions will be made. Keep a calibration split separate from the data used to fit any task-specific components, and reserve an evaluation split for an unbiased check. If the deployment population changes by season, geography, device, or source, evaluate those conditions explicitly rather than relying on an aggregate score.
Use reliability diagnostics, not accuracy alone
Group predictions into confidence bins and compare average confidence with the observed fraction correct in each bin. A model that is accurate but systematically overconfident can still produce unsafe automatic decisions. Expected calibration error (ECE) is one summary, but binning choices and class imbalance affect it; inspect reliability diagrams, per-class behavior, and the distribution of high-confidence errors as well.
Calibrate with an appropriate method
Temperature scaling is a common post-hoc approach for multiclass logits: one learned temperature rescales the logits before the softmax. Other methods can be useful when a single global adjustment cannot capture class imbalance or varying confidence patterns. The calibration method must be fitted without leaking labels from the final test set, and its output should be rechecked after any prompt, model, preprocessing, or label-set change.
Calibration does not decide whether a false positive is worse than a referral. It only aims to make the confidence values more empirically meaningful. A policy still needs an explicit action rule and a cost model.

What conformal prediction adds
Split conformal in plain language
- Train or select the zero-shot scoring model without using the held-out calibration labels for fitting that model.
- Use a separate labeled calibration sample to compute a nonconformity score for each example. The score measures how incompatible the observed label is with the model’s output.
- Choose a miscoverage level, such as 10% for a nominal 90% marginal-coverage target, and take the appropriate quantile of the calibration scores.
- For a new example, include every label whose score is within that threshold. The result is a prediction set, which may contain one label, several labels, or—depending on the method and label universe—no label.
Under the procedure’s assumptions, the set is intended to contain the true label at the selected marginal rate. The guarantee is about the overall population represented by the exchangeable calibration and test examples. It is not automatically a guarantee for every class, demographic group, site, or time period.
Coverage is not the same as usefulness
A set that contains the true label often is not enough. Set size, or efficiency, tells you how narrowly the method identifies candidates while meeting the coverage target. Large sets may force a human to inspect many possibilities and provide little operational value. Domain drift can make sets less efficient even when the stated coverage argument remains applicable under its assumptions.
Can conformal prediction work with a zero-shot model?
Yes, provided labeled calibration examples are available. A zero-shot model supplies the scores; conformal prediction uses a separate calibration sample to turn those scores into sets. The CVPR 2025 work by Silva-Rodríguez, Ben Ayed, and Dolz applies split conformal prediction to zero-shot CLIP models and studies efficiency under domain variation.

That paper reports, in its experiments across 15 datasets and three non-conformity scores, that its Conf-OT approach achieved up to a 20% relative improvement in set efficiency and ran 15 times faster than the popular transductive approaches it compared. Those are results for that experimental setup, not universal gains for every zero-shot architecture, data distribution, or conformal algorithm. The same work identifies domain drift as a practical challenge for keeping prediction sets efficient.

Before deployment, verify that the calibration examples and incoming cases are plausibly exchangeable. If the camera, language, population, label definitions, or prevalence changes, monitor both coverage and set size and recalibrate or redesign the procedure when needed.
How calibration interacts with conformal prediction
It is tempting to assume that better-calibrated probabilities will always produce better conformal sets. The interaction is more specific than that. An ICML 2025 analysis by Dabah and Tirer examines temperature scaling and conformal prediction for deep classifiers, including adaptive conformal procedures, and provides guidance that depends on the practitioner’s goal.
Calibration can change the ordering and scale of scores used by a conformal method, so its effect depends on the nonconformity score, algorithm, data regime, and objective. It may help a procedure focused on probability interpretation while offering little or no benefit for a particular set-construction rule. Test the combination you intend to deploy rather than treating calibration as a universal conformal upgrade.

The proceedings record summarizes the distinction precisely: “Conformal Prediction (CP) produces a prediction set of candidate labels that contains the true label with a user-specified probability, guaranteeing marginal coverage but not, e.g., per class coverage.” This wording matters: a nominal target does not silently become a class-conditional or subgroup guarantee.

When should a model abstain instead of predicting?
Define the available actions
- Predict: accept the top label or a conformal singleton when the evidence is sufficient.
- Abstain: return no automatic label when the case is too uncertain or the set is too large.
- Refer: route the case to a trained reviewer, possibly with the model’s scores and candidate set.
Choose a threshold from expected costs
A threshold is a policy choice, not a property supplied by the model. Assign application-specific costs to an incorrect automatic prediction, an abstention, and human review. Estimate expected cost on a calibration or validation split, then select the threshold that meets the service’s risk and workload constraints. Reassess it when review capacity, error consequences, or the data distribution changes.
A 2026 Scientific Reports paper by Kwon and Kim illustrates this design pattern in early-sepsis prediction: the deferral threshold was selected using task-specific expected costs on a calibration split. The threshold should not be copied into another clinical task or treated as a universal operating point.
What recent results do—and do not—establish
| Reported result | Scope and qualification |
|---|---|
| 49.6% error reduction at 80% coverage in-distribution | Kwon and Kim’s early-sepsis experiment on its specified temporal test split. |
| 46.7% error reduction at 80% coverage out-of-distribution | The same paper’s specified out-of-distribution temporal test split; not a general clinical estimate. |
| ECE 0.016 in-distribution and 0.030 out-of-distribution | Values reported for that early-sepsis study and its test sets. |
| 1.4 percentage-point reduction in the gender coverage gap | The reduction reported for the Mondrian method in that study. |
| Up to 20% relative efficiency improvement and 15-times faster runtime | Conf-OT’s comparisons in the CVPR 2025 zero-shot experiments across 15 datasets and three non-conformity scores. |
These numbers demonstrate what the respective experiments measured. They do not establish that one method is safest, most accurate, or fastest in every domain. Transfer requires reproducing the evaluation with the target labels, population, shift pattern, and operational costs.

- Check labels and exchangeability. Do you have enough labeled calibration examples, and are they plausibly drawn from the same process as deployment cases?
- State the guarantee precisely. Is the target marginal coverage, class-conditional coverage, or a subgroup-specific requirement? Use the method and evaluation that match that claim.
- Measure efficiency. Record average and tail prediction-set size, singleton rate, abstention rate, and reviewer workload at the selected coverage.
- Probe shift. Evaluate new domains, time periods, sites, devices, and prevalence changes. Track whether coverage and efficiency degrade.
- Test calibration separately. Report reliability by class and confidence range, not only one aggregate ECE.
- Model action costs. Compare wrong predictions, abstentions, and review costs. Select thresholds on a held-out calibration or validation split and document the operating point.
- Monitor after launch. Log scores, sets, actions, outcomes, and reviewer decisions so that drift and calibration failure can be detected.
Common failure modes and fixes
“The score is 0.95, so the prediction is safe.”
High confidence can be miscalibrated, especially under domain shift. Check reliability on deployment-like labeled data and impose a deferral policy for costly errors.
“90% conformal coverage means every class is covered 90% of the time.”
The ordinary guarantee is marginal. Report per-class and subgroup coverage if those distinctions matter, and use a method designed for the required guarantee when justified.
“Higher coverage automatically means a better system.”
Coverage without efficiency can yield unwieldy sets. Report set size, singleton frequency, and human workload together with coverage.

Bottom line for deployment decisions
Zero-shot models can classify new labels without task-specific labeled training examples, but their uncertainty still needs evidence. Use calibration when you need confidence values whose empirical meaning is tested. Use conformal prediction when a candidate-label set and a stated marginal-coverage target fit the workflow. Add selective prediction when the system can abstain or defer, and choose its threshold from the real costs of errors, abstentions, and review. Validate every claim under the intended data distribution, report efficiency as well as coverage, and treat published improvements as study-specific evidence rather than universal guarantees.
