Open-source, open-weight LLMs need broader monitoring than hosted APIs because the operator controls nearly every part of the reliability surface: checkpoint, quantization, tokenizer, inference engine, kernels, GPU, batching, context limit, prompt, retrieval index, safety layer, and rollout schedule. A green HTTP health check only proves that a process answered; it does not prove that the answer was useful, grounded, safe, fast, or economical.

Reliable production monitoring therefore joins infrastructure telemetry with serving metrics, retrieval data, model behavior, safety signals, and task outcomes. Every material change needs a versioned evaluation, a canary or shadow phase, and a tested rollback path.

Why self-hosted models have a larger reliability surface

Hosted APIs hide most of the moving parts

With a hosted API, the provider usually owns the accelerator fleet, drivers, kernels, batching policy, serving runtime, capacity planning, and model release process. You still need to measure latency, errors, quality, and safety, but many causes of a regression are outside your deployment.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

In a self-hosted deployment, those causes are yours. A new checkpoint can change factuality or refusal behavior. A quantization format can reduce memory use and increase throughput while changing answer quality or decoding stability. A different runtime, kernel, GPU generation, driver, or CUDA version can alter queueing and time to first token (TTFT). A prompt template, retrieval index, or safety filter can change task completion and harmful-output rates without producing a server error.

Why an HTTP health check is not enough

An endpoint can return status 200 while requests wait in a long queue, the first token arrives too late, a retrieval index is stale, structured output fails validation, answers are no longer grounded, or a safety layer misses a jailbreak. Reliability must be defined in terms of user and business outcomes, not process liveness alone.

The five layers to monitor together

Infrastructure

Track accelerator and host health: GPU utilization, memory allocation and headroom, temperature, power, CPU and RAM pressure, network throughput, disk I/O, container restarts, and node availability. Capacity problems often appear first as queue growth or rising TTFT rather than an outright error.

Serving runtime

Measure request rate, concurrency, queue depth, scheduling delay, batch sizes, prefill and decode behavior, TTFT, inter-token gap, tokens per second, end-to-end latency, timeouts, cancellations, retries, and error classes. Record which inference engine and runtime build handled each request.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Data and retrieval

For retrieval-augmented generation (RAG), monitor index freshness, retrieval hit rate, number of documents returned, context relevance, context length, and query-resolution failures. A stable latency chart can conceal a quality regression caused by changed documents, embeddings, filters, or user-input distributions.

Model behavior

Score factuality, groundedness, relevance, task success, refusal correctness, structured-output validity, response length, language mix, and style. Evaluate hallucinations against the task and available evidence rather than treating every uncertain answer as an infrastructure fault.

User and business outcomes

Connect model behavior to the result the application promises: a correctly extracted field, a resolved support case, a valid tool call, a completed workflow, or a useful answer rated by the user. These outcome metrics decide whether a technically healthy service is reliable enough to keep.

Metrics and budgets that belong in the same dashboard

Use separate error budgets for availability, responsiveness, capacity, quality, safety, and efficiency. The following signals give each budget an operational meaning.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Budget Metrics What a breach means
Availability Successful responses, HTTP and application errors, timeout rate, retry rate, cancellation rate, queue rejection Users cannot obtain a completed response, regardless of its quality.
Responsiveness TTFT, p50/p95/p99 end-to-end latency, inter-token gap, tokens per second, stream completion time The service feels slow or violates an interaction deadline even when requests eventually succeed.
Capacity Concurrent sequences, queue depth and age, GPU utilization, GPU-memory headroom, CPU/RAM, network and disk I/O Traffic is approaching a limit, causing queueing, evictions, throttling, or instability.
Quality Task success, factuality, groundedness, relevance, citation or evidence presence, schema validity, refusal correctness Answers are wrong, unsupported, malformed, or unhelpful while the endpoint remains available.
Safety Toxicity, jailbreak success, prompt-injection success, PII leakage, policy violations, unsafe tool calls The model or its surrounding controls produce unacceptable risk.
Cost and efficiency Input and output tokens per request, cache-hit rate, GPU-hours, energy or cost per successful task The system consumes more resources without delivering proportional user value.

Keep TTFT separate from total latency. TTFT captures admission, queueing, scheduling, and prompt prefill; tokens-per-second mostly describes the decode phase. A system can have excellent decode speed but poor TTFT because requests are waiting for a saturated GPU.

Make every response reproducible

Attach a deployment identity to every request trace. At minimum, record:

  • Model family, exact checkpoint or commit, tokenizer, and quantization format.
  • Inference engine and runtime version, kernel or backend when relevant, GPU type, driver, and CUDA version.
  • System and user prompt-template versions, sampling parameters, context limit, stop rules, and tool settings.
  • Retrieval index version, document or chunk identifiers (or privacy-safe hashes), retriever configuration, and reranker version.
  • Safety-layer and policy versions, request and response IDs, status and error details, input and output token counts, TTFT, total latency, and stream timings.
  • Evaluator scores, moderation results, user feedback, and the release or experiment identifier.

Without this identity, an alert can tell you that quality fell but not whether the cause was a new weight file, prompt, index, runtime, GPU pool, or safety rule. Keep enough metadata to replay the request while redacting secrets and personal data.

Set SLOs from workload baselines, not universal numbers

There is no single reliable-LLM threshold. A small interactive assistant, a batch summarizer, and a tool-calling workflow have different tolerances. Establish a baseline for representative traffic, then set targets that reflect user value, model size, hardware, concurrency, and geographic requirements.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Google Cloud’s AI/ML reliability guidance describes holistic observability as essential and gives these illustrative examples:

Illustrative objective Qualification
99.9% of API calls return a successful response Availability example, not a universal default.
95th-percentile inference latency below 300 ms Applicable only to workloads whose model and hardware can meet that interactive target.
TTFT below 500 ms for 99% of requests Measures initial responsiveness and should be recalibrated for prompt length and queueing.
Harmful-output rate below 0.1% Safety example; define the taxonomy, evaluator, sampling plan, and severity policy before adopting it.

Publish separate budgets for successful completion, latency, quality, safety, and cost. A release can meet availability while exhausting the quality budget, or meet quality while exhausting the cost budget. Alert and roll back on the budget that matters instead of waiting for a generic uptime alarm.

Evaluate every change before broad traffic

Build a versioned golden set

Assemble representative production tasks, difficult edge cases, safety probes, structured-output examples, and RAG questions. Include failures found by support teams and users. Store expected answers, acceptable variations, evidence requirements, and safety labels with the dataset version.

Combine complementary evaluators

Use deterministic checks for JSON or schema validity, citation presence, required fields, regular-expression rules, and policy constraints. Add model-based judges for coherence, fluency, groundedness, relevance, safety, tool-call accuracy, and task completion. Sample cases for human review because automated judges can miss subtle factual or safety failures.

Google’s performance guidance says standardized evaluation helps teams track progress across iterations, compare models, detect and mitigate bias, and support regulatory requirements. Microsoft Foundry documents evaluators for coherence, fluency, groundedness, relevance, safety, tool-call accuracy, and task completion, along with sampled continuous and scheduled evaluation after deployment.

Use canaries, shadows, and explicit rollback criteria

  1. Run the golden set against the current production version to establish quality, latency, token, and safety baselines.
  2. Test the candidate after any checkpoint, quantization, runtime, prompt, retrieval-index, hardware, or safety-layer change.
  3. Send a small canary percentage to the candidate, or shadow-copy requests without exposing its responses to users.
  4. Compare availability, TTFT, p95/p99 latency, queueing, GPU headroom, task success, groundedness, refusal correctness, harmful-output rate, and cost per successful task.
  5. Define automatic rollback thresholds before deployment. Keep the previous model files, container image, configuration, index, and infrastructure definition available for immediate restoration.

Instrument traces, metrics, and asynchronous evaluation

Use OpenTelemetry-compatible distributed traces where possible. A trace should connect the user request to gateway admission, queue wait, prompt construction, retrieval, model prefill and decode, tool calls, safety checks, and the final response. Include the versioned identity fields listed above and preserve per-token timing when the serving stack exposes it.

MLflow describes LLM monitoring as continuous evaluation of quality, performance, cost, and safety. A practical pattern is to capture production traces, score them asynchronously with LLM judges, route a sample to human review, and attach token and cost accounting plus safety scores. Asynchronous scoring avoids adding judge latency to the user request while still exposing regressions quickly.

At the infrastructure layer, use the four golden signals—latency, traffic, errors, and saturation—alongside CPU, GPU, memory, network, disk, logs, and traces. Serving systems such as vLLM or Triton expose runtime metrics that can be integrated with Managed Service for Prometheus. NVIDIA DCGM can provide per-process GPU utilization, memory, and temperature. Alert on both instantaneous spikes and sustained changes from the established baseline.

Diagnose slowdowns after quantization or runtime changes

Quantization lowers memory but does not guarantee lower latency

Quantization can fit a model on a smaller GPU and permit larger batches, yet a particular format may use slower dequantization kernels, lack an optimized kernel for your GPU, or move work from compute to memory bandwidth. Longer prompts, larger context windows, and changed batching can also erase the expected gain. Compare prefill time, decode tokens per second, batch size, memory bandwidth, and queue wait before and after the change rather than looking only at total latency.

Separate queueing, prefill, and decode symptoms

  • High TTFT with normal decode speed usually points to queue depth, admission limits, or prompt-prefill pressure.
  • Normal TTFT with a low tokens-per-second rate points to decode kernels, GPU clocks, memory bandwidth, or an incompatible backend.
  • Rising p99 latency with high GPU utilization and little memory headroom indicates saturation; reduce concurrency, shorten context, add capacity, or tune batching.
  • Low GPU utilization with long waits can indicate CPU tokenization, network or storage stalls, synchronization overhead, or a scheduler bottleneck.

Record GPU model, driver, CUDA, runtime, kernel, batch policy, sequence lengths, and sampling settings in benchmark results. Re-run the same workload after every change so comparisons are meaningful.

Detect drift, hallucinations, and RAG failures

Monitor input distributions such as language, prompt length, topic, and request type. Track output length and style, refusal rate, retrieval hit rate, index freshness, context relevance, groundedness, hallucination rate, query-resolution failure, and user ratings. Compare these distributions with a training or production baseline and alert only when the change is statistically meaningful for the traffic volume.

When an alert fires, retain the affected examples and replay them through the evaluation suite. Inspect whether the shift came from users, retrieved data, model behavior, or an evaluator change. A latency-only dashboard cannot distinguish these causes, and a quality-only dashboard cannot show that the underlying GPU pool is about to fail.

Monitor safety and reasoning traces carefully

Safety monitoring should include jailbreak attempts, prompt injection, PII leakage, toxicity, policy violations, and unsafe tool calls. Measure both the raw model and the effectiveness of filters, because a lower harmful-output rate may result from a safety layer that is blocking legitimate requests or increasing refusal errors.

OpenAI’s gpt-oss model card says, “In our recent research, we found that monitoring a reasoning model’s chain of thought can be helpful for detecting misbehavior.” It also warns that chains can contain hallucinated content and should not be shown directly to users without filtering, moderation, or summarization. Treat intermediate reasoning traces as sensitive diagnostic data: restrict access, define retention, redact secrets, and expose only a safe summary to end users.

Model-specific evaluation is essential. The same card describes SimpleQA as a diverse set of 4,000 fact-seeking questions with short answers and reports that gpt-oss-120b and gpt-oss-20b underperformed o4-mini on SimpleQA and PersonQA. That result does not make a model unusable; it demonstrates why a self-hosted checkpoint must be tested on the tasks your application actually performs instead of being assumed equivalent to a hosted model.

Hosted API and self-hosted open-weight deployment: operational trade-offs

Axis Hosted API Self-hosted open-weight model
Weights and updates Provider controls releases and access to weights. Operator chooses checkpoints, update timing, and rollback artifacts.
Runtime tuning Hardware, kernels, batching, and scheduler are mostly hidden. Operator can tune runtime, kernels, batching, context, and decoding.
Capacity responsibility Provider operates the fleet; quotas still apply. Operator owns GPUs, drivers, scaling, spare capacity, and failures.
Observability depth Usually limited to API-level metrics and provider telemetry. Can include queue, kernel, GPU, retrieval, trace, and per-token data.
Data residency Depends on provider regions and contract. Can be kept in infrastructure you control, subject to your own governance.
Quality and safety burden Provider supplies some safeguards, but application evaluation remains necessary. Operator must evaluate weights, prompts, retrieval, safety layers, and updates.
Rollback and reproducibility Provider versioning may be standardized but not fully controllable. Requires pinned artifacts, immutable images, configuration capture, and tested rollback.
Total cost and staffing Usage pricing trades infrastructure work for provider dependence. Hardware and energy costs are paired with on-call, platform, and ML evaluation work.

Production rollout checklist

  1. Freeze and record the model checkpoint, tokenizer, quantization, runtime, driver, GPU, prompt template, retrieval index, and safety-layer versions.
  2. Define user-facing SLOs and error budgets for availability, TTFT and latency, quality, safety, and cost.
  3. Instrument traces, queue metrics, serving metrics, and GPU telemetry before exposing broad traffic.
  4. Create a golden set with representative tasks, edge cases, safety probes, and RAG questions; record baseline distributions.
  5. Run deterministic, model-based, and human evaluation before and after every material change.
  6. Canary or shadow new checkpoints, quantizations, runtimes, prompts, indexes, and hardware.
  7. Alert separately on latency and saturation failures, quality drift, and safety regressions.
  8. Keep rollback artifacts and enough trace context to reproduce a failure without retaining unnecessary sensitive data.
  9. Review sampled production traces and user feedback; add real failures to the next evaluation-set version.

What a useful incident review should answer

For every reliability incident, determine whether the first symptom was availability, queueing, GPU saturation, model quality, retrieval, or safety. Identify the exact request, model and checkpoint, quantization, prompt, index, runtime, GPU, driver, and sampling parameters involved. Compare it with the last known-good trace, replay the case against both versions, and document whether rollback, configuration repair, data correction, or evaluation-set expansion prevents recurrence.
