Train across multiple datacenters only when one tightly connected facility or accelerator slice cannot provide the capacity, placement, or schedule your job requires—and measurements show that cross-site communication will not consume the benefit. A second site changes the training topology: synchronization travels over a slower or less predictable network, while data reads, checkpoint writes, and failure recovery also cross a boundary. If the model fits in one well-connected slice and communicates frequently, one datacenter is usually the safer starting point.

The decision in one sentence

Use multiple datacenters for AI training when the extra accelerator capacity or a hard placement requirement is worth the communication, storage, and operational costs introduced between sites. Do not treat a second datacenter as a transparent extension of the first. Establish a single-site baseline, run the same workload across the proposed placement, and accept the distributed design only if useful work, not network waiting, improves enough to meet your objective.

Why crossing a datacenter boundary changes training

Distributed training repeatedly exchanges information. In data parallel training, each worker computes gradients on its mini-batch and participates in an all-reduce before the next update. Other strategies exchange activations, parameters, or optimizer state. The frequency and volume of those exchanges determine how sensitive the run is to network latency and bandwidth.

Google Cloud’s TPU architecture illustrates the distinction. A TPU slice is a group of chips in one TPU Pod connected by high-speed inter-chip interconnects (ICI). Traffic between slices uses the datacenter network (DCN). Google describes ICI as higher bandwidth and lower latency than standard DCN. A geographically separated design adds another boundary and may add more variable latency, so measurements from a single slice cannot be assumed to predict multi-datacenter performance.

Capacity is the primary justification

First ask whether the model, optimizer state, batch size, and desired throughput fit in one tightly connected slice or facility. If they do, adding a site generally adds coordination rather than capability. A second location becomes compelling when the run cannot fit, when one facility cannot supply enough accelerators by the required date, or when a contractual or physical placement constraint requires workers in more than one location.

Communication is the limiting cost

The relevant question is not whether the network is labelled high speed. It is how long synchronization takes compared with computation on the exact model and configuration. For TPU multislice strong scaling, Google advises that DCN all-reduce take less time than the backward pass. That is workload-specific guidance, not a universal latency or utilization threshold for every accelerator platform.

Choose one datacenter when these conditions hold

  • The entire job fits in a single well-connected slice, including model parameters, optimizer state, activations, and the intended batch size.
  • The model performs frequent all-reduces or other exchanges, and a trial shows that cross-boundary communication would occupy a material share of each training step.
  • Training reads the same data repeatedly and a remote dataset would cause input stalls or cache misses.
  • Checkpoints are large, synchronous, or written to storage far from the workers, creating pauses that erase the compute gain.
  • A single failure domain and simpler restart path are more valuable than additional nominal capacity.

A single-site placement is not automatically optimal: a crowded facility can miss a schedule while a second site meets it. Include availability and deadline in the baseline, but keep the comparison tied to measured throughput and recovery behavior.

Consider multiple datacenters when the extra capacity solves a concrete problem

  • The model cannot fit within one facility or slice, even after evaluating memory-saving techniques.
  • Additional accelerators are needed to meet a documented training deadline, and the proposed placement is actually available.
  • Benchmarking shows that the chosen parallelism keeps communication below the time available for useful computation.
  • Datasets can be staged or cached near workers, and checkpoint writes can be made fast enough or asynchronous enough to avoid long pauses.
  • Operations can orchestrate workers, network paths, storage, and restart behavior across the locations.
  • Data-location, contractual, or organizational policies permit the required movement of training data and checkpoints.

Measure the boundary instead of guessing

Run the same training configuration in a single-site baseline and in the intended multi-site placement. Keep model version, precision, global batch size, optimizer, input pipeline, checkpoint frequency, and software versions constant. Record:

Axis What to measure or verify
Capacity Whether the model and job fit in one tightly coupled slice, and how much usable capacity the second site adds.
Communication All-reduce or other synchronization time relative to useful compute, plus latency and bandwidth on the actual path.
Parallelism strategy Whether data, fully sharded data, or pipeline parallelism fits the topology and batch size.
Data locality Dataset placement, cache-hit behavior, input stalls, and repeated remote reads.
Checkpoints Write duration, whether writes are synchronous, storage throughput, and distance from workers.
Operational recovery Failure domains, restart behavior, checkpoint recovery, and orchestration across locations.
Economics and constraints Accelerator-hour cost, network charges, facility capacity, scheduling, and applicable data-location requirements.

At minimum, capture examples or tokens per second, step time, scaling efficiency, accelerator utilization, communication time, data-loader wait time, checkpoint duration, and recovery time after a controlled restart. Compare the multi-site result with the one-site baseline at the same effective batch and quality target. There is no published cross-vendor cutoff that tells every team when to proceed; your model and network must supply the evidence.

A useful communication test

  1. Run enough warm-up steps to remove compilation and cache effects.
  2. Record the backward-pass duration and the all-reduce duration separately. For TPU multislice strong scaling, the all-reduce should be shorter than the backward pass according to Google’s guidance.
  3. Repeat at the intended worker count and global batch size. A configuration that scales at a small test size may fail when gradient or parameter volume grows.
  4. Inspect step-time variance, not only the average. Cross-site paths can expose tail latency that produces periodic stragglers.
  5. Repeat with the real input pipeline and checkpoint schedule; a compute-only test does not account for storage stalls.

Match the parallelism strategy to the topology

Google’s TPU multislice recommendations are an example of topology-aware design, not a rule for every accelerator system. The choice determines what crosses the boundary and how often.

Strategy When to consider it Boundary caution
Data parallelism Start here when the workload already runs well on one slice and the goal is to scale across slices or sites. For strong scaling, compare DCN all-reduce time with the backward-pass time. Frequent synchronization can dominate when the per-worker batch is small.
Fully sharded data parallelism Use when reducing memory use is important enough to justify more communication. Sharding lowers replicated memory but adds cross-slice exchanges; measure whether the saved capacity outweighs that traffic.
Pipeline parallelism Consider when the batch size supports a sufficiently shallow pipeline and analysis shows network latency is manageable. Pipeline bubbles and stage-to-stage transfers can become expensive across locations; validate the schedule at the intended depth.
Tensor parallelism across slices Use only when the platform and measured fabric can sustain the required activation traffic. Google says, in its described TPU multislice environment, “We don’t recommend sharding activations across the model dimensions (sometimes called tensor parallelism) because it requires too much inter-slice bandwidth.” Do not generalize that TPU-specific warning to every topology.

When a workload is healthy on one slice, pure data parallelism is the recommended starting experiment in Google’s multislice guidance. Memory pressure may justify fully sharded data parallelism, while pipeline parallelism depends on batch size and pipeline depth. Inter-slice tensor parallelism is specifically discouraged in that guidance because activation traffic is too demanding for the described inter-slice link.

Account for data placement and caching

Training is iterative: workers read data on every step, often revisiting the same shards across many epochs. NVIDIA’s DGX SuperPOD B200 storage architecture emphasizes that repeated reads can make storage and network access part of the training path, and recommends caching to avoid retrieving the same data repeatedly over a network.

Questions to answer before splitting sites

  • Where is the authoritative dataset, and can a complete or partial copy be staged near each worker group?
  • What is the cache capacity and expected hit behavior for the actual shard order?
  • Does a cache miss block the data loader, or can prefetching hide the transfer?
  • Are data transforms performed locally, and do they create an additional shared-service bottleneck?
  • Can both sites see identical dataset versions and sampling state?

Measure data-loader wait time and accelerator idle time with caching enabled and disabled during a representative run. A multi-site job that has more accelerators but spends those accelerators waiting for remote reads has not achieved useful scaling.

Design checkpointing as part of the network plan

Checkpoints contain model and optimizer state and can be much larger than a model’s parameter file. NVIDIA’s storage guidance notes that synchronous checkpoint writes can block forward progress. In a multi-datacenter run, the pause may include transfer to remote storage, replication, metadata operations, and coordination between sites.

  • Measure the complete checkpoint interval, from the training barrier through durable completion.
  • Record whether workers are blocked synchronously or continue while a checkpoint is written.
  • Place a fast checkpoint target close to workers when policy allows, then replicate according to the recovery requirement.
  • Test restoration from the copy that would actually be used after a site failure; a successful write is not proof of a usable recovery path.
  • Include checkpoint frequency in throughput comparisons. A placement that wins with checkpoints disabled may lose under the production schedule.

Plan for failures and recovery across locations

Two datacenters create at least two infrastructure failure domains and a more complex orchestration problem. A transient link failure, storage outage, or scheduler interruption can leave workers in different states. Before committing, document which events cause the job to stop, how workers rejoin, where the latest valid checkpoint resides, and how much work may be repeated after restart.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Run a controlled worker or link interruption at a safe point.
  2. Verify that the job detects the failure rather than silently producing inconsistent progress.
  3. Restore from the designated checkpoint and record time to resume useful training.
  4. Repeat with one site unavailable if the service is expected to tolerate a site-level outage.
  5. Compare the lost compute and operator effort with the single-site recovery path.

The available guidance does not quantify recovery performance, so treat this as an engineering test rather than assuming that geographic distribution automatically improves resilience. A two-site job may survive one facility failure, but only if storage, orchestration, and software semantics support that outcome.

Use platform figures only in their proper scope

The Google Cloud TPU multislice documentation states that each TPU host has a maximum network bandwidth of 50 Gbps and discusses communication in bits per parameter per step. Those are specifications for the documented TPU platform, not general datacenter-network benchmarks. They cannot establish a universal requirement for GPU clusters, geographically distant facilities, or another provider’s fabric.

Likewise, TPU multislice guidance concerns communication between TPU slices over DCN. It is useful evidence that a looser fabric changes the scaling trade-off, but it is not a benchmark of wide-area training between arbitrary geographic sites. Obtain measurements on the actual route, including congestion and tail behavior.

Include economics, scheduling, and policy

Compute cost is only one part of the comparison. Add accelerator-hour rates, inter-site network charges, storage requests and replication, engineering time, and the cost of a longer or more complicated recovery. A second site may reduce time to acquire capacity while increasing data-transfer charges; the correct answer depends on the deadline and utilization you can actually sustain.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Check scheduling guarantees and service limits at both locations. Capacity that is theoretically available but cannot be reserved for the full run is not a reliable plan. Confirm that contracts and organizational policies allow the dataset, logs, checkpoints, and derived artifacts to cross the relevant boundaries. No single cross-border or data-residency rule applies to every project; consult the legal and policy requirements for the jurisdictions and data involved.

A practical go/no-go procedure

  1. Define the constraint. Write down whether the problem is memory capacity, accelerator count, deadline, availability, resilience, or a placement policy.
  2. Build the one-site baseline. Measure throughput, step time, utilization, input stalls, checkpoint duration, and recovery with production settings.
  3. Select a topology-compatible strategy. Start with data parallelism for a healthy single-slice workload; evaluate sharding or pipelining only when their specific benefits justify extra traffic.
  4. Stage data and checkpoints. Decide what is cached locally, where durable copies live, and how synchronous pauses are handled.
  5. Run the multi-site trial. Use the same model, global batch, precision, input order, and checkpoint cadence as the baseline.
  6. Inspect tails and failures. Measure communication variance, loader stalls, checkpoint pauses, and restart time, not just mean tokens per second.
  7. Make the decision against the original constraint. Proceed only if the measured capacity or schedule benefit remains after network, storage, recovery, and economic costs.

Common mistakes

  • Assuming more accelerators means faster training. If synchronization or input waits rise faster than compute capacity, elapsed time can increase.
  • Using a local-cluster benchmark as a WAN proxy. ICI and DCN have different characteristics, and geographically separated sites add further uncertainty.
  • Choosing tensor parallelism because it reduces memory. Activation traffic can overwhelm an inter-slice link; verify the platform’s guidance and measure the actual exchange.
  • Benchmarking without checkpoints. Synchronous writes may block production training and change the result materially.
  • Ignoring cache warm-up and misses. A synthetic in-memory test can hide repeated remote reads in the real input pipeline.
  • Counting nominal capacity that cannot be scheduled together. The job needs simultaneous, reliable placement for its full duration.
  • Assuming geographic distribution is automatically more resilient. Recovery requires tested checkpoints, orchestration, and consistent state across failure domains.

What the evidence can and cannot tell you

Published platform documentation provides mechanisms and workload-specific recommendations, not a universal number of datacenters, accelerator count, latency, bandwidth, utilization, or cost at which distributed training becomes worthwhile. There is also no named, dated cross-industry statistic establishing a general performance or price advantage for multi-datacenter training. Treat every threshold as an outcome of your own benchmark, and label platform figures with their provider and environment.

The defensible conclusion is therefore conditional: keep tightly synchronized training inside one well-connected slice whenever it fits and meets the schedule; span sites when a real capacity or placement constraint remains and measurements show that communication, data access, checkpointing, recovery, and cost still satisfy the project’s requirements.
