Start by classifying the symptom, then compare the same workload with a known-good single-GPU or same-node baseline. A training job that progresses slowly, hangs in a collective, fails during initialization, or crashes has a different fault path. Capture rank-specific logs before changing NCCL settings, then isolate the system in this order: process and GPU mapping, intra-node GPU links, inter-node networking, container/runtime limits, and only finally NCCL tuning.
This sequence prevents a common mistake: treating every multi-GPU slowdown as a tuning problem when the cause is an incorrect rank assignment, an unusable network interface, a broken peer path, or a resource limit.
1. Classify exactly what is failing
Record the first bad training step and the wall-clock time. Note which ranks continue, which stop, the last collective or operation reported, and whether the job exits, remains stuck, or keeps making progress at a lower rate. Do not mix these symptoms in one investigation.
| Symptom | What to capture first | Most useful first layer |
|---|---|---|
| Slow but progressing | Step time before and after degradation, per-rank throughput, GPU utilization, and communication time | Rank placement, GPU topology, and fabric bandwidth |
| Hang or NCCL timeout | Ranks that stopped, last collective, timeout time, and NCCL warning lines | Collective participation, peer paths, network reachability, and shared memory |
| Initialization failure | Full startup log, selected interface, transport error, and container limits | Runtime configuration, interface selection, versions, and device visibility |
| Crash | Error class, rank, CUDA error text, and whether other ranks remain alive | CUDA/NCCL external failures versus application misuse |
NCCL distinguishes external-library failures such as ncclUnhandledCudaError and ncclSystemError from invalid-argument or invalid-usage errors. Treat the warning text as evidence: the former points toward CUDA, drivers, hardware, or system setup; the latter usually requires inspecting the application’s collective calls, tensor shapes, rank participation, or lifecycle.

2. Preserve evidence and enable focused diagnostics
Run the failing workload with enough logging to identify the last successful operation, but avoid collecting unbounded debug output that obscures the event. For NCCL, warnings are a reasonable first pass; use focused initialization, graph, and environment information when topology or affinity is in doubt:
NCCL_DEBUG=WARN torchrun --nproc-per-node=<gpus> train.py ...
NCCL_DEBUG=INFO NCCL_DEBUG_SUBSYS=INIT,GRAPH,ENV
torchrun --nproc-per-node=<gpus> train.py ...
Enable PyTorch distributed diagnostics when ranks disagree or a connection fails. TORCH_DISTRIBUTED_DEBUG can increase distributed logging, and a strategically placed monitored_barrier() can identify the rank that never reaches a synchronization point. Add barriers around a suspected phase rather than throughout the entire training loop, because extra synchronization changes timing.
Keep the following with every run:
- Host name, rank, local rank, global world size, and visible GPU list.
- Exact command line, launcher, container image, CUDA, NCCL, PyTorch, driver, and kernel versions.
- Timestamped logs from every rank, not just rank zero.
- Whether the same code succeeds on one GPU, one node, and multiple nodes.
3. Verify rank placement and resource ownership
Each NCCL process must have exclusive access to every GPU it uses. Sharing one GPU between processes can deadlock or produce invalid NCCL usage, even when the number of visible devices looks correct. Confirm the mapping at runtime rather than trusting launcher defaults.
Check device visibility and rank mapping
- Print
CUDA_VISIBLE_DEVICES, global rank, local rank, and the CUDA device selected by each process. - Compare the launcher’s process count with the GPUs allocated by the scheduler.
- Look for duplicate assignments, an off-by-one local-rank calculation, or a process that sees a different device order from its peers.
- Check that a restarted job did not leave an old process holding a GPU or NCCL communicator.
Use nvidia-smi while the job is running to associate process IDs with devices. If a rank has no process on its intended device, stop and correct the launcher or allocation before testing performance.
Check CPU, memory, and NIC affinity
On NUMA systems, a rank can be assigned to a GPU but run mostly on CPUs or a memory node that is far away. The same applies to the network interface used for inter-node traffic. Inspect the host topology with:

lscpu --extended=CPU,NODE,SOCKET,CORE
Use your scheduler’s CPU and memory binding controls, or Open MPI binding options, then verify the actual process placement with the operating system’s process and NUMA tools. Do not assume that a launcher’s default binding is optimal. A rank close to its GPU and NIC generally avoids avoidable host-memory and PCIe traffic; the correct placement depends on the machine’s topology.
4. Inspect intra-node GPU paths
Multi-GPU performance depends on the physical path between each GPU pair, not merely on the number of visible GPUs. A node may contain a mixture of NVLink, direct PCIe, and PCIe paths through a root complex or switch. Those paths can produce very different collective performance.
Read the topology
nvidia-smi topo -m
This output shows relationships among GPUs, CPUs, and network interfaces. Use it to spot a rank-to-GPU assignment that crosses an unexpectedly distant path. For peer access checks, run:
nvidia-smi topo -p2p p
nvidia-smi topo -p2p n
These commands report peer-to-peer capabilities for relevant path types. A positive result does not prove that every system-level prerequisite is healthy, so treat it as one observation rather than a complete validation.
Measure GPU bandwidth directly
Use nvbandwidth to measure GPU memory and pairwise GPU bandwidth. Test the pairs used by the training job, not only a convenient pair. Compare the measurements with the hardware configuration and with a known-good node of the same model. No universal bandwidth threshold is valid across GPU generations, link types, PCIe layouts, and message sizes.

Investigate peer-access prerequisites
Unexpectedly low bandwidth or failed peer access warrants a hardware-path investigation:
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
- Confirm the expected NVLink or PCIe topology and that links are not degraded.
- Check PCIe access-control settings, including ACS, when they can force traffic through a less direct path.
- On Linux bare-metal PCIe systems, check whether active IOMMU translation is affecting peer transfers.
- For GPU Direct paths, verify the supported driver, NIC, and peer-memory mechanism for the installed stack.
5. Measure the inter-node fabric independently
Do not use NCCL alone to decide whether the network is healthy. A network interface can be up on each host yet fail to communicate with the peer, select the wrong fabric, or deliver poor latency under the job’s process placement.
Run low-level bandwidth and latency tests
Use the fabric’s appropriate diagnostics, such as:
ib_write_bw
ib_write_lat
Run them between the same hosts, interfaces, and traffic domains used by training. Record message sizes, bandwidth, latency, and whether both directions work. For systems that support it, use a multinode nvbandwidth build to test GPU-to-GPU transfers across hosts.
Confirm interface selection and peer reachability
- Read NCCL initialization logs to see which interface and transport were selected.
- Verify that the selected interface can reach every participating host, not just the local operating system.
- Check routing, VLAN or subnet membership, firewall rules, link state, and switch-port errors with your infrastructure tools.
- Repeat the test with the exact host pair that hangs; a healthy path to one node does not validate another.
When direct GPU-to-NIC communication is expected, verify compatible NIC and driver support and the applicable nvidia-peermem or DMA-BUF path. A missing or incompatible peer-memory path can force a slower transfer route or prevent initialization.

6. Inspect containers and runtime limits
NCCL initialization and collectives use shared memory, pinned memory, device files, and topology information. Containers can restrict any of these even when the host works correctly.
Check shared and locked memory
Inspect the container’s /dev/shm size and its locked-memory limit. Shared-memory errors, unexplained startup hangs, or failures that occur only inside a container are strong reasons to compare these limits with the host. Docker diagnostic examples commonly increase --shm-size and raise the memlock limit; use values appropriate for the job and platform rather than copying a fixed example blindly.
Expose topology and devices
- Ensure all required GPUs, NICs, and device files are passed into the container.
- Confirm that the container can read a useful PCI topology through
/sys. - Compare NUMA nodes visible inside and outside the container.
- Check cgroup CPU, memory, and locked-memory limits for throttling or allocation failures.
If a bare-metal run succeeds but the container fails, diff the runtime limits and mounts before changing NCCL variables.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.7. Check software and version consistency
When logs identify an external library or fabric failure, verify that every participating node uses compatible CUDA, NCCL, driver, and runtime versions. A mixed installation can pass basic import tests and still fail when a particular transport or collective is initialized.
- Print versions from every host, not only the launch node.
- Confirm that the container’s user-space libraries match the host driver’s supported interface.
- Check that all nodes load the same NCCL plugins and network libraries.
- After a driver or firmware update, rerun the low-level fabric and GPU-pair tests before blaming the training code.
For invalid-usage or invalid-argument errors, inspect the program instead: every rank must enter matching collectives in the same order with compatible tensor metadata, and no rank should exit early while peers continue.

8. Compare measured layers before tuning
Build a small evidence table for the exact workload:
| Layer | Healthy evidence | Failure implication |
|---|---|---|
| Single-GPU baseline | Stable step time and repeatable throughput | Instability may be in the model, input pipeline, or host rather than communication |
| Rank and affinity | One process per assigned GPU with intended CPU and NUMA placement | Correct launcher or scheduler allocation first |
| Intra-node GPU pairs | Bandwidth and peer access match the expected topology | Investigate NVLink, PCIe, ACS, IOMMU, or peer-memory prerequisites |
| Inter-node fabric | Independent bandwidth and latency tests succeed between training hosts | Investigate interface selection, routing, switch path, or NIC support |
| Runtime limits | Shared memory, memlock, devices, and topology are available | Correct container or cgroup configuration |
| NCCL benchmark | Controlled collective test is repeatable | Only now evaluate NCCL configuration and workload-specific tuning |
If GPU-pair and fabric measurements are healthy but NCCL remains below expectation, change one configuration variable at a time and rerun the same benchmark. Keep the original environment and workload as a control. A setting that improves one message size, topology, or collective can make another workload slower, so a tuning result is not portable by default.
9. A fault-isolation runbook
- Reproduce and classify: run the same code with the same data shape and record whether it slows, hangs, fails at initialization, or crashes.
- Capture logs: collect all rank logs, NCCL warnings, focused initialization output, and PyTorch distributed diagnostics.
- Reduce scope: compare one GPU, multiple GPUs on one node, and multiple nodes without changing the training workload.
- Validate ownership: confirm exclusive GPU use, rank mapping, CPU binding, NUMA placement, and visible devices.
- Test local paths: inspect topology, peer access, and pairwise GPU bandwidth.
- Test remote paths: run fabric bandwidth and latency checks between the exact hosts and interfaces.
- Check runtime limits: compare shared memory, memlock, cgroups, device exposure, and PCI topology inside and outside containers.
- Check versions: align CUDA, NCCL, drivers, plugins, and runtime libraries across nodes.
- Change one variable: only after the measured layers are healthy, benchmark a controlled NCCL or launcher change and retain the baseline.
10. Common traps and recovery actions
Changing environment variables first
Environment-variable workarounds can hide a broken path and make later comparisons impossible. Revert experimental settings, save the baseline, and reintroduce changes individually after topology and fabric tests pass.
Free tools Windows power users keep installed
One-click scans. No signup required.
Trusting a local link-state check
An interface reported as “up” does not establish end-to-end reachability or usable bandwidth. Run peer-to-peer tests through the same interfaces and routes selected by NCCL.
Assuming visible GPUs are equivalent
Two GPUs can be visible yet connected through different PCIe or NVLink paths. Use topology output and pairwise measurements when assigning ranks.
Looking only at rank zero
Rank zero may continue logging while another rank has stopped. Aggregate timestamps and last-operation messages from every process to identify the first diverging rank.
Using a generic bandwidth target
Hardware-specific topology, message size, transport, and software versions determine expected values. Compare against the documented machine configuration or a known-good identical node instead of an invented universal threshold.
