AI training changes a model; AI inference uses the trained model. Training repeatedly adjusts neural-network weights by comparing predictions with known answers and reducing the resulting error. Inference runs those learned weights on new inputs to produce a prediction, classification, recommendation, or generated response, without updating the model parameters during the request.
That difference changes the engineering problem. Training is usually a planned run optimized for sustained throughput and accelerator utilization. Interactive inference is a serving workload in which response latency, concurrency, memory capacity, availability, and cost per request matter. Offline inference can instead be optimized for throughput, so the serving context—not the word “inference” alone—determines the right design.
The direct distinction: changing weights versus using weights
A neural network contains learned parameters, commonly called weights. During training, the system uses examples to adjust those parameters. During inference, the system treats the parameters as fixed and calculates an output for an input it has not previously processed in that training run.
- Training: learn or adapt model parameters from data, usually with a defined training objective.
- Inference: apply the resulting model to new data and return an output.
- Fine-tuning: a form of training because it updates parameters, even when it starts from an existing foundation model.
- Generation and multi-step reasoning: still inference when the model is producing outputs without changing its weights.
The distinction is operational as well as mathematical. A training job is generally a finite experiment or production run with a known dataset, while an inference service may receive requests continuously, arrive in bursts, or run as a scheduled batch.

How the training loop works
Training and inference begin with the same forward computation: input data passes through the network to produce an output. Training adds several steps that make the model learn.
- Prepare examples. Inputs are placed into batches, often so accelerator memory and compute are used efficiently.
- Run a forward pass. The network calculates a prediction from the current weights.
- Compare with a target. In supervised learning, the prediction is compared with a known correct answer. The difference is expressed as a loss or error value.
- Backpropagate the error. The system calculates how each parameter contributed to the error.
- Update the weights. An optimizer changes the parameters according to the calculated gradients and the selected learning settings.
- Repeat. Many batches and iterations gradually reduce the chosen loss or improve another training objective.
NVIDIA’s deep-learning explanation describes this as forward propagation followed by error calculation, backpropagation, and weight updates. Moving model weights into accelerator memory has a cost, so batching can amortize that movement and improve utilization during training. The exact loop varies by learning method: self-supervised, unsupervised, reinforcement, and distributed training use different targets or update rules, but they all involve a learning signal that can change parameters.
What happens during inference
Inference loads a trained model and evaluates it on an input. The normal request does not require a known correct answer, loss calculation, gradient computation, or optimizer update. The output can be a class label, score, embedding, forecast, image, audio segment, or text.
Traditional prediction and classification
For a classifier, inference might normalize an image, run it through the network, and return probabilities for the available classes. A forecasting model can accept recent observations and return a predicted value. These operations use the learned parameters as they are; feedback may be logged for later analysis or a future training run, but it is not an immediate weight update.
Large-language-model requests
An LLM serving path has distinct stages. The prompt is first converted into tokens. In the prefill phase, the model processes the supplied prompt and builds the intermediate attention state needed for generation. In the decode phase, it produces output tokens, generally one step at a time, until it reaches a stopping condition or a configured limit. NVIDIA’s inference overview uses this tokenization, prefill, and decode framing.

Prefill work is tied to the amount of input context, while decode work grows as more output tokens are generated. The service must retain per-request state, commonly called a key-value cache in transformer serving, so a longer conversation or more simultaneous users can consume substantial memory. Sampling, tool calls, retrieval, and multiple reasoning steps can make a request more involved, but they remain inference unless the model parameters are updated.
Why the performance target changes
Training and inference can use the same model architecture and accelerators yet have different bottlenecks and success measures.

AWS Prescriptive Guidance characterizes training workloads as typically predictable, compute-bound, and throughput-oriented, while inference workloads are often less predictable, more memory-bound, and more latency-sensitive. “Typically” and “often” matter: a large training job can hit memory or communication limits, and an offline inference pipeline can deliberately maximize throughput instead of minimizing response time.
Latency, throughput, and concurrency in plain terms
Latency
Latency is the time a request takes to produce a response. For an interactive chatbot, users may care about time to first token and the interval between subsequent tokens. A recommendation API may instead have a strict end-to-end response target. Lower latency can require keeping a model loaded, reserving capacity, using shorter queues, or selecting hardware with sufficient memory bandwidth.
Throughput
Throughput is the amount of work completed per unit of time, such as training examples per second, requests per second, or generated tokens per second. Batching usually improves hardware utilization, but waiting to form a larger batch can increase an individual request’s latency.

Concurrency
Concurrency is the number of requests being served at once. More concurrent requests can raise total throughput, yet each request consumes memory for activations, attention state, or other intermediate data. A serving system therefore balances queueing, batch size, sequence length, and available memory rather than maximizing one metric in isolation.
Why memory behaves differently
Training commonly stores more than the model’s weights. Depending on the optimizer and precision, it may also need gradients, optimizer state, activations for backpropagation, and temporary communication buffers. Batch size and sequence length can increase those requirements. Checkpoints must be written so a long run can resume after interruption.
Inference does not need gradients or optimizer state in the ordinary serving path, but memory can still be the limiting resource. The complete model must be loaded, and each active request can add state. Longer prompts, longer generated responses, larger batches, and higher concurrency all increase the working set. A model that fits for a single short request may not fit under the intended production load.
Precision is another workload choice. Google Cloud’s GPU guidance identifies compute characteristics, memory requirements, precision formats, and scalability as factors in accelerator selection. Lower-precision inference can reduce memory use and increase available throughput when the model and quality target support it; the acceptable precision depends on validation, not on a universal rule.
Workload patterns and scaling
Planned training capacity
Training capacity is normally provisioned for a run with a defined dataset, batch strategy, duration, and checkpoint plan. Distributed training can add data movement between accelerators, interconnect requirements, synchronization overhead, and recovery questions. Microsoft Learn recommends evaluating those issues separately from serving concerns, including checkpoint storage, retry behavior, run duration, and the cost of a complete training run.

Interactive inference capacity
An interactive service must absorb changing demand while keeping the model available. Operators plan for model-loading time, request queues, concurrency limits, autoscaling behavior, health checks, and serving security. Usage-based cost is often considered per request or token, but idle reserved capacity and sudden traffic spikes can change the economics.
Offline or batch inference
Batch inference runs a stored collection of inputs, such as a nightly scoring job. Because users are not waiting on each item, the system can prioritize total throughput, larger batches, and efficient accelerator utilization. Calling every inference workload “latency-sensitive” would therefore be misleading.
Choosing hardware by workload rather than by label
No single GPU or accelerator is automatically best for “AI.” The model, precision, input shape, concurrency target, and service-level objective determine the useful specification.
| Decision axis | Training questions | Inference questions |
|---|---|---|
| Compute | Can the accelerator sustain the desired batch throughput and training precision? | Can it meet the required response time and token or request rate? |
| Memory capacity | Will weights, gradients, activations, optimizer state, and batches fit? | Will weights plus per-request state fit at the target sequence length and concurrency? |
| Memory bandwidth | Can data and parameters move fast enough to keep compute busy? | Can it feed repeated decode steps and concurrent requests without becoming a bottleneck? |
| Precision | Which precision preserves training stability and the desired model quality? | Which validated precision meets quality, memory, and latency goals? |
| Scalability | What interconnect and synchronization performance are needed across accelerators? | How will replicas, batching, and autoscaling meet demand? |
| Cost | What is the cost of provisioned resources for the full run, including retries? | What is the cost per request or token, plus idle capacity and burst handling? |
Current accelerator specifications and cloud offerings change, so a model’s measured memory footprint and service target should be checked against the current hardware documentation. The criteria above are more durable than a blanket recommendation of one device family.
Operational differences beyond the model
Training operations
- Build and validate a reproducible data pipeline.
- Plan checkpoint frequency, storage capacity, and restart behavior.
- Measure accelerator utilization, input-pipeline stalls, communication overhead, and run duration.
- Define how failed workers or interrupted jobs resume without losing excessive work.
Inference operations
- Load and warm the model before accepting traffic, accounting for loading time.
- Set limits for prompt length, output length, batch size, and concurrent requests.
- Monitor time to first token, complete-request latency, queue time, throughput, memory use, and error rate.
- Protect the endpoint with authentication, authorization, rate limits, input controls, and isolation appropriate to the data.
- Design for model versioning, rollback, health checks, and capacity changes during traffic spikes.
Microsoft’s workload guidance also cautions that managed compute capabilities can have preview status. Availability and feature labels should be verified on the current service documentation before they become part of an architecture decision.

Common misconceptions to avoid
“Inference is just a smaller training job.”
Inference may use less state than training, but its serving constraints are different. A production endpoint can fail because of queueing, model-load time, request bursts, or per-session memory even when a one-off test succeeds.
“Training is always compute-bound and inference is always memory-bound.”
Those are useful tendencies, not definitions. Training can be limited by memory capacity, data movement, or interconnects. Inference can be compute-bound, especially for large batches or heavy prefill work. Measure the actual model and traffic pattern.
“All inference must minimize latency.”
Interactive applications usually care about responsiveness, but a batch scoring pipeline may have a deadline measured in hours and seek maximum total throughput instead.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
“Feedback automatically makes a model learn.”
Collecting user ratings, corrections, or new examples does not change weights by itself. Those signals must enter a subsequent training or fine-tuning process before the model parameters are updated.
A practical way to classify your workload
- Identify whether weights change. If the process computes gradients or applies an optimizer update, classify it as training or fine-tuning. If it only evaluates fixed weights, classify it as inference.
- Define the serving context. Record whether requests are interactive, near-real-time, or offline batch. This determines whether latency or throughput receives priority.
- Write down the shape of demand. Estimate input length, output length, request rate, concurrency, and whether traffic is steady or bursty.
- Calculate the memory working set. Include model weights, precision, batches, sequence lengths, and request-specific state rather than checking only the model-file size.
- Choose measurable targets. Set latency or completion deadlines, throughput, availability, quality, and cost limits before comparing hardware.
- Plan recovery and scaling. For training, cover checkpoints, retries, duration, and interconnects. For inference, cover model loading, replicas, autoscaling, queues, security, and rollback.
This process prevents a common purchasing mistake: selecting hardware from a model’s name or parameter count alone. The same model can need very different infrastructure for a single offline batch, a low-latency API, or a multi-user conversational service.
Bottom line
Training is the learning phase: predictions are compared with a training signal, errors are backpropagated, and weights are updated over repeated examples. Inference is the application phase: fixed weights transform new inputs into outputs. Training infrastructure is usually organized around sustained, predictable work and checkpointed runs; inference infrastructure is organized around the serving contract, which may emphasize latency, concurrency, memory, throughput, or cost per request. Treating those as workload questions—not immutable rules—leads to more accurate capacity planning and better hardware choices.
