Data movement in AI is the transfer of inputs, model parameters, intermediate tensors and outputs between storage, memory, processors and other accelerators. Model compute is the arithmetic performed on those values. An operation finishes as fast as its limiting resource allows: memory-bound work waits for data access, while compute-bound work is limited by arithmetic throughput. Latency can also be the constraint.

This distinction matters because a processor with more theoretical arithmetic capacity will not automatically make an AI workload faster. If loading and storing values takes longer than the calculations, increasing compute throughput leaves runtime largely unchanged. The balance depends on the operation, its implementation, data reuse and the bandwidth and latency of the hardware.

What data movement means in an AI system

An AI operation normally follows three broad stages:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  1. Read inputs, weights or other parameters.
  2. Perform arithmetic on the values.
  3. Write an output or intermediate result.

The first and third stages are data movement; the second is model compute. In a real system, these stages can overlap. A GPU may calculate one group of values while another group is being fetched, so total runtime is not simply the time for every transfer added to the time for every instruction. The practical limit is usually the slower resource under the current conditions.

Movement is more than copying a file

Data movement includes accesses through the processor’s memory hierarchy, transfers between a GPU and system memory, reads from storage, and communication among accelerators in a distributed training or inference job. A tensor can move through several levels before an arithmetic unit uses it:

  • Persistent storage holds datasets, checkpoints and model files.
  • System memory stages data for the host processor and accelerator.
  • GPU or accelerator memory supplies data at high bandwidth to compute units.
  • On-chip caches, shared memory and registers provide progressively faster but smaller working areas.
  • Interconnects carry tensors, gradients and parameters between devices.

Each boundary has its own bandwidth, latency and access pattern. A workload can therefore be limited by storage transfers, device memory bandwidth, an accelerator interconnect or an on-chip access pattern, even when the arithmetic itself is straightforward.

What model compute is

Model compute is the numerical work used to transform values. Examples include the multiply-and-add operations in a matrix multiplication, the additions and multiplications in a convolution, and the elementwise functions used by activation layers and normalization. During training, backpropagation adds arithmetic for gradients and parameter updates; during inference, the forward pass performs the requested prediction or generation.

Compute capacity is often described in operations per second. That peak figure is a ceiling, not a guarantee that a particular model will reach it. The implementation must supply data quickly enough, expose enough parallel work, and use instructions suited to the processor. If those conditions are not met, the arithmetic units can sit idle while the system waits for data.

Aspect Data movement Model compute
What happens Values are fetched, transferred, staged or written. Instructions perform arithmetic or numerical transformations.
Typical limiting resource Memory bandwidth, interconnect bandwidth, storage throughput or access latency. Arithmetic throughput and available parallel execution.
Typical symptom Compute units are waiting for operands or results to move. Arithmetic pipelines remain busy and approach their practical throughput.
Ways to improve it Move fewer bytes, reuse data, improve locality, raise bandwidth or overlap transfers with work. Use efficient kernels, increase parallelism, reduce unnecessary operations or select hardware with more suitable arithmetic capacity.

Memory-bound versus compute-bound work

Memory-bound

A workload is memory-bound when moving data takes longer than the associated calculation under the relevant conditions. Making the arithmetic unit faster does not help much if it still receives operands at the same rate. NVIDIA’s deep-learning performance guidance describes this situation as a routine whose time is limited by loading inputs and writing outputs: increasing calculation speed alone cannot remove that limit.

Elementwise operations are a common example. Adding a bias, applying an activation or converting a tensor’s format may perform only a small amount of arithmetic for every byte read and written. The processor spends much of its time moving the tensor rather than calculating on it. Whether a specific kernel is memory-bound still depends on data layout, cache reuse, fusion and the hardware’s bandwidth.

Compute-bound

A workload is compute-bound when arithmetic throughput is the limiting resource. Matrix multiplications with substantial reuse can perform many operations on values already resident in fast memory. Once data supply is adequate, adding arithmetic capacity or improving the kernel’s utilization can reduce runtime.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Compute-bound does not mean that movement is irrelevant. Inputs still have to arrive, and outputs still have to be stored. It means that, for the measured operation and conditions, the arithmetic side takes longer than the data-access side.

Latency-bound cases

Latency is different from sustained bandwidth. A request may be delayed by the time to begin an access, synchronize devices or complete a dependency, even when the link’s long-run transfer rate is high. Small kernels, irregular accesses and frequent synchronization can therefore be latency-limited. NVIDIA’s GPU performance background guide identifies latency as another possible performance limit alongside memory access and arithmetic throughput.

Arithmetic intensity: the bridge between movement and compute

Arithmetic intensity is the number of compute operations performed per byte of memory moved. It connects an algorithm’s work to the capabilities of a particular machine:

arithmetic intensity = compute operations ÷ bytes moved

Low arithmetic intensity means that relatively little arithmetic is done for each transferred byte. Memory bandwidth is more likely to cap performance. High arithmetic intensity means that many operations reuse each byte, making peak compute throughput more likely to be the limit. NVIDIA’s hardware-oriented explanation of large-language-model design uses this relationship to reason about whether a workload can keep arithmetic units fed.

Arithmetic intensity is not a permanent label attached to an entire model. It can change with batch size, sequence length, tile size, precision, fusion, cache behavior and the implementation of a kernel. The same model may contain both low-intensity and high-intensity operations.

Where movement occurs

Inside the memory hierarchy

Moving a value between registers, on-chip shared memory, a cache and device memory has different costs. Reusing a value while it is in a faster level can reduce traffic to slower levels. Tiling a matrix multiplication is one example of arranging work so a block of data is loaded once and used for many operations.

Between host memory and an accelerator

Input pipelines may transfer batches from system memory to GPU memory, while results, checkpoints or metrics move in the opposite direction. If transfers are serialized with computation, the accelerator can wait between batches. Pinned buffers, larger transfers and asynchronous copies can help in suitable implementations, but they do not remove the underlying bandwidth limit.

Between storage and a GPU

Large datasets and checkpoints often reside on storage rather than in system memory. Direct storage-to-GPU paths, such as those described in NVIDIA’s GPUDirect Storage documentation, address this movement boundary. Storage throughput, queueing and request size then become part of the workload’s performance, not just the speed of the model’s kernels.

Between accelerators

Distributed training exchanges activations, gradients or parameters among devices. Inference systems may split a model across accelerators and transfer intermediate tensors at each boundary. Interconnect bandwidth, communication latency and synchronization determine whether devices remain busy. A device can have ample arithmetic capacity yet wait for a peer’s data.

How the distinction appears in common AI operations

Matrix multiplication

Matrix multiplication can be compute-bound when tiles are reused extensively. Each loaded value participates in many multiply-and-add operations, raising arithmetic intensity. A poor tile size or an implementation that repeatedly reloads data lowers reuse and can turn the same mathematical operation into a memory problem.

Elementwise and pointwise layers

Operations such as activation functions, masking and simple additions often read one or more tensors, perform a small calculation and write a tensor of similar size. Their arithmetic intensity is usually lower than that of a large matrix multiplication, so memory traffic and kernel-launch overhead can dominate. Fusing compatible operations reduces intermediate writes and reads.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Attention and transformer workloads

Transformer execution mixes operations with different profiles. Matrix products may provide substantial arithmetic work, while moving key-value states, masks or intermediate tensors can pressure memory bandwidth. During autoregressive generation, small, sequential steps can expose latency and communication costs that are less visible in a large batched calculation.

Input and checkpoint pipelines

A model can have efficient kernels and still underperform if data cannot arrive from storage or the host quickly enough. In that case, the bottleneck is outside the model’s arithmetic. Profiling the complete pipeline is necessary before attributing the delay to the network itself.

Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Support on Ko-Fi

How to identify the bottleneck

  1. Define the measured boundary. Decide whether timing includes storage reads, preprocessing, host-to-device copies, device synchronization and output transfers. Excluding a stage can hide the movement that users actually experience.
  2. Measure both work and traffic. Record operation counts, bytes transferred at relevant memory levels, kernel duration and achieved bandwidth. Theoretical peak values alone do not establish achieved performance.
  3. Check utilization together. High arithmetic-unit utilization suggests compute pressure; low utilization with high memory activity suggests a movement limit. A low value for both can indicate latency, synchronization, poor parallelism or an inefficient implementation.
  4. Compare arithmetic intensity with hardware ceilings. Estimate operations per byte for the measured kernel and compare it with the processor’s practical compute and memory-throughput limits. Keep the same batch size, precision, layout and software configuration when comparing results.
  5. Inspect transfers and synchronization. Look for host-device copies, peer-to-peer communication, storage stalls and barriers that serialize otherwise overlapping work.
  6. Change one factor and retest. Increase reuse, fuse a pair of kernels, alter batch size or overlap a copy with computation, then measure the same end-to-end boundary. A speedup confirms that the changed resource was relevant.

Ways to reduce a data-movement limit

  • Move fewer bytes: eliminate unnecessary materialization, avoid duplicate copies and use an appropriate representation or precision where accuracy permits.
  • Reuse data: tile operations and arrange layouts so values stay in caches, shared memory or registers for more calculations.
  • Fuse operations: combine compatible pointwise steps to avoid writing and rereading intermediate tensors.
  • Overlap stages: pipeline input loading, host-device copies and computation when the software and hardware support asynchronous execution.
  • Improve locality: choose contiguous access patterns and batch work so accesses are predictable and coalesced.
  • Reduce communication: place dependent layers together, limit unnecessary synchronization and select a partition that minimizes accelerator-to-accelerator traffic.
  • Address the right boundary: faster storage does not fix an on-chip bandwidth problem, and more arithmetic capacity does not fix a saturated interconnect.

Ways to reduce a compute limit

  • Use kernels and instruction paths optimized for the processor and the selected numerical precision.
  • Increase useful parallelism through appropriate batching or tiling, provided memory and latency constraints remain acceptable.
  • Remove redundant operations and choose algorithms that provide the same result with less arithmetic.
  • Keep arithmetic units supplied with data; compute optimization without a matching data path can leave the original bottleneck unchanged.

How to compare two workloads or systems fairly

Compare the limiting resource, the location of transfers and the exact workload implementation. A peak compute specification cannot establish which system is faster for an AI model. Report the operation or model version, batch and sequence dimensions, precision, software implementation, storage path and whether communication is included in the timing.

Comparison question Why it matters
What resource limits runtime? Memory bandwidth, arithmetic throughput, latency and communication require different optimizations.
Where do bytes move? On-chip traffic, device memory, storage and interconnects have different costs and failure modes.
How much reuse occurs? Reuse raises arithmetic intensity and can shift a kernel away from a memory limit.
What implementation and conditions were measured? Kernel choice, layout, precision, batch size and overlap can change the bottleneck.

Common misconceptions

“AI is always memory-bound.”

Some operations are constrained by movement, but others are constrained by arithmetic, and a single model can contain both. The label is conditional on the workload, implementation and hardware.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

“More FLOPS always means a faster model.”

More arithmetic throughput helps only when arithmetic is the limiting resource. If the system is waiting for data, the additional capacity remains unused.

“Data movement means only loading the dataset.”

Dataset loading is one part. Intermediate tensors, parameters, outputs, cache accesses, host-device copies, storage paths and accelerator-to-accelerator communication all count.

“Bandwidth and latency are interchangeable.”

Bandwidth describes sustained volume per unit time; latency describes the delay before an access or dependency completes. A workload can be limited by either, especially when transfers are small or serialized.

A practical checklist

  • Include every stage that matters to the user-visible time.
  • Separate arithmetic time from reads, writes and communication.
  • Calculate arithmetic intensity for the operation being measured.
  • Check whether values are reused or repeatedly fetched.
  • Measure achieved bandwidth and compute utilization instead of relying on peak specifications.
  • Look for synchronization and transfer gaps between kernels.
  • Optimize the resource that actually limits the measured workload, then retest end to end.

Data movement and model compute are complementary parts of every AI execution. Compute transforms values; movement delivers and stores them. Performance improves when the implementation matches the balance between those activities rather than optimizing an isolated peak number.
