A memory capacity bottleneck occurs when a system’s usable memory pool is too small to hold the data and working state a workload needs. The workload may have to shrink, move data elsewhere, or stop with an error. The key is identifying which memory pool is full: spare system RAM does not automatically make more GPU-local memory available.

What the term means

Memory capacity is how much information a particular memory pool can hold. A capacity bottleneck arises when the workload’s required working set exceeds, or is constrained by, the usable capacity of that pool. The result can limit the workload’s size or complexity, force a different execution approach, or prevent the workload from running as configured.

The relevant pool might be GPU memory, system RAM, or another component’s memory. Capacity is not one interchangeable system-wide number: a GPU can run out of its local memory while the computer still has unused RAM. The accelerator-memory work by Kwon and Rhu describes limited physical memory inside an accelerator as a constraint on which algorithms can be studied. Kwon and Rhu, MICRO 2018

Capacity is different from bandwidth

Capacity describes how much data can be held; bandwidth describes how quickly data can be transferred. A workload may fit in memory but run slowly because data cannot move to the processor quickly enough. Conversely, fast memory does not solve a capacity problem if the required working set will not fit. A 2023 survey describes the data-movement bottleneck as a mismatch between an application’s transfer needs and the rate the system can sustain. 2023 processing-in-memory survey

  • Disclaimer: Maximum Speed requires overclocking/PC BIOS adjustments. Maximum speed and performance depend on system components, including motherboard and CPU
  • Hand-sorted memory chips ensure high performance with generous overclocking headroom
  • VENGEANCE LPX is optimized for wide compatibility with the latest Intel and AMD DDR4 motherboards
  • A low-profile height of just 34mm ensures that VENGEANCE LPX even fits in most small-form-factor builds
  • A solid aluminum heatspreader efficiently dissipates heat from each module so that they consistently run at high clock speeds

Memory hierarchy also involves performance tradeoffs: main memory typically holds more than CPU-local storage but has lower performance, while the memory bus adds latency and limits transfer rate compared with on-CPU storage. Those hierarchy effects help explain why the location of data matters, but they are not the definition of a capacity bottleneck. Computer Architecture: A Quantitative Approach

How a capacity limit affects a workload

When the required working set cannot fit in the relevant pool, the workload may need to use less data or a smaller model, divide the work into pieces, offload some state, or use a design that exposes additional memory. Sometimes it simply cannot run with the chosen configuration. Each option changes what fits, but may have other costs—especially if data must move between memory pools.

For GPU workloads, available GPU memory must accommodate more than just the model or input data. Inputs, activations, and other state can all contribute to usage. A 2024 dissertation’s GraphSAGE experiments on an NVIDIA RTX 6000 with 24 GB of GPU memory found that some tested configurations exceeded available memory and produced out-of-memory errors; memory constraints also affected the tested depth, hidden size, and aggregation fanout. This is an example from one setup, not a universal GPU-memory requirement. University of California eScholarship dissertation, 2024

Why adding memory elsewhere may not fix it

More memory helps only if it increases the capacity the workload can actually use. Unused host RAM does not automatically become GPU-local capacity. Some systems and software can use CPU memory alongside GPU memory through virtualization, but transferring data between the pools can add overhead; if transfers become the limiting factor, exposing more capacity may not improve performance as expected. • Non-ECC, DDR5 U-DIMM, 288-pin, for Desktop PC & Gaming
  • Includes JEDEC default profile, and AMD EXPO & Intel XMP 3.0 memory overclock profile
  • Do not mix memory kits. Memory kits are sold in matched kits that are designed to run together as a set. Mixing memory kits will result in stability issues or system failure.

For the same reason, a hardware upgrade should target the diagnosed pool rather than memory in general. More system RAM is not an automatic remedy for a GPU-local limit, and more GPU memory will not necessarily help a workload whose real constraint is transfer rate.

A research example of expanding accelerator memory

Kwon and Rhu’s MICRO 2018 paper proposes pooling memory modules near the device-side interconnect to expand accelerator-accessible capacity. In the authors’ evaluation, the proposed system achieved an average 2.8× speedup across eight deep-learning applications and system-wide memory capacity reaching tens of terabytes. These are results for the paper’s proposed architecture and tested applications, not a general performance promise for commercial systems. MICRO 2018 paper

How to identify the limiting memory pool

  1. Find the failing or constrained component. Check whether the workload reports GPU out-of-memory, system-memory exhaustion, or another pool-specific limit.
  2. Account for the working set. Include model or application state, input data, intermediate activations, and other allocations, not just the largest obvious object.
  3. Separate fit from speed. If the working set fits but performance is poor, investigate data movement and bandwidth rather than assuming capacity is the problem.
  4. Choose a remedy that the workload can use. Consider reducing or partitioning the workload, offloading or virtualizing memory where supported, or increasing the capacity of the constrained pool. Account for any transfer overhead.
