Training a long-horizon reinforcement-learning (RL) agent requires an end-to-end system, not simply a learner attached to a large GPU. The system must reset and execute stateful environments, run policy inference, record observations and rewards, handle episodes that may take very different amounts of time, update the policy, and evaluate it on tasks that were not used for training.

The right infrastructure depends on the workload. A tool-using language-model agent, an embodied robot simulator, a vectorized game environment, and a multi-agent physics benchmark place their bottlenecks in different places. Start with a representative end-to-end run, measure each stage, and add CPU, GPU, memory, storage, or network capacity only where the profile shows a constraint.

What a long-horizon RL training system must do

In a short episodic benchmark, a single process can sometimes step an environment, call a policy, compute a loss, and repeat. Long-horizon agents make that loop irregular and expensive. An episode may involve hundreds of decisions, multiple tool calls, external state changes, retries, and a long-tailed completion time. The infrastructure therefore has to keep several pipelines moving at once:

  • Environment execution: create or reset task instances, apply actions, advance state, and enforce timeouts.
  • Policy inference: turn observations into actions or tool calls, often with variable latency and memory use.
  • Trajectory handling: capture observations, actions, rewards, outcomes, termination reasons, and tool outputs.
  • Learning: consume experience, calculate returns or advantages, and update policy parameters.
  • Evaluation: run held-out tasks and preserve enough evidence to reproduce the reported result.

If environment workers are CPU-bound, an idle accelerator will not increase completed episodes. If inference or learning saturates GPU memory, adding more environment processes only lengthens the queue. Capacity planning must therefore include the actors and environments, not just learner utilization.

Define the workload before choosing hardware

Write down the workload specification before selecting a cluster, workstation, or cloud instance. The following details determine the shape of the system:

  • Agent type: language-model and tool-using, embodied, game-playing, robotic, or multi-agent.
  • Episode statistics: median length, 90th, 95th, and 99th-percentile length, timeout policy, and expected completion rate.
  • Observation and action modalities: text, images, audio, sensor streams, discrete actions, continuous controls, or tool calls.
  • Environment fidelity: a lightweight state machine, a full physics simulator, a browser or software sandbox, or a remote service.
  • Concurrency target: the number of simultaneous rollouts required to keep the learner supplied with fresh experience.
  • Reward design: dense step rewards, sparse terminal outcomes, human or model feedback, and any reward components that must be retained.
  • Evaluation cadence: how often checkpoints are tested, how many held-out tasks are needed, and what statistical uncertainty is acceptable.

There is no universal CPU-to-GPU ratio or bill of materials. The NVIDIA Research study The Architectural Implications of Distributed Reinforcement Learning on CPU-GPU Systems identifies actor count and the resources available to environment interactions as primary performance and power-efficiency limiters. That conclusion supports profiling, not a fixed hardware prescription.

Build the core components

1. Environment and interaction harness

Make the environment a managed service or worker library with a clear reset/step interface. Each task instance should have a controllable seed, a version identifier, a timeout, and an explicit termination reason. Instrument environment-step latency separately from policy latency so a slow simulator is not mistaken for a slow model.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

For tool-using agents, isolate the execution environment. A sandbox may need a fresh filesystem, process namespace, network policy, credentials, and cleanup procedure for every episode. Sandbox creation and destruction belong in rollout orchestration because they can dominate tail latency. Record tool requests and outputs when they are part of the trajectory.

Use generated or otherwise held-out task instances for evaluation. OpenAI’s Procgen benchmark was designed with diverse procedural environments and separate training and test levels; its authors state that this makes the benchmark suitable for evaluating generalization. Replaying one fixed sequence of tasks can hide memorization.

2. Rollout generation and trajectory storage

A rollout worker repeatedly obtains the current policy, sends an observation through inference, applies the resulting action, and records the transition. It must detect success, failure, timeout, environment errors, and policy errors independently. Do not treat a crashed worker as an unsuccessful episode without preserving the distinction.

Long episodes create a heavy-tailed workload: a few workers can remain busy while others finish quickly. A synchronous barrier that waits for every worker at every update may leave compute idle. At small scale, that simplicity can be worthwhile; at larger scale, a queue of rollout requests and adaptive worker allocation can improve utilization.

ProRL Agent describes a rollout-as-a-service API for the agentic lifecycle, with extensible sandbox environments, and reports validation on software-engineering, mathematics, STEM, and coding tasks. This demonstrates a viable separation between rollout generation and learning; it does not mean every project needs a separately deployed service.

3. Learner and parameter distribution

The learner consumes batches or sequences of trajectories, computes the algorithm’s loss, and updates policy parameters. Decide how workers receive new parameters: a synchronized update at a fixed interval, versioned checkpoints pulled by workers, or a parameter server. Include the policy version in every trajectory so data collected with stale parameters can be identified.

Monitor learner throughput alongside the rate at which completed trajectories arrive. A learner that is 90 percent GPU-utilized may still be starved if workers cannot produce data fast enough; conversely, a rapidly growing trajectory queue can indicate that learning is the bottleneck or that the collection policy is generating data faster than it can be consumed.

4. Scheduling, queues, and communication

Use explicit queues between environment execution, inference, trajectory storage, and learning. Queue depth and wait time reveal backpressure that aggregate CPU or GPU utilization hides. Keep control-plane traffic, model-parameter transfers, and large observation or trajectory payloads measurable as separate flows.

DynaRL, presented at USENIX OSDI 2026, explores dynamic allocation across computation, memory, and communication for heavy-tailed rollouts and irregular tool interactions. Its authors report up to a 1.98× end-to-end throughput improvement on their evaluated math-reasoning and agentic-RL workloads. That figure is specific to those experiments; it is not an expected gain for an unrelated environment or model.

5. Storage and observability

Store trajectories in a format that can be replayed or audited. At minimum, retain environment and task version, seed, policy checkpoint, timestamps, observations or references to them, actions, reward components, termination reason, and tool outputs where applicable. Separate high-volume raw data from compact training indexes so retention policies do not interrupt learning.

Centralize logs for worker crashes, timeouts, invalid actions, environment resets, out-of-memory events, and parameter-version mismatches. A dashboard should show both rates and distributions: a mean episode length can look healthy while the 99th percentile is exhausting workers.

Workload condition Likely pressure point What to measure or change
Lightweight, CPU-step environments with a large policy Inference or learner GPU time Actions or tokens per second, GPU memory, batch size, and parameter-transfer delay
Complex simulators or many sandbox processes CPU execution and reset latency Environment steps per second, per-worker CPU saturation, reset time, and run-queue length
Image or sensor-heavy observations Memory bandwidth and network transfer Observation serialization size, transfer time, host memory, and accelerator input pipeline
Very long or irregular episodes Tail latency and worker imbalance Episode-length percentiles, queue wait, straggler time, and adaptive scheduling effectiveness
Multi-agent vectorized environments Environment implementation and accelerator compatibility Vectorization efficiency, device memory, synchronization overhead, and environment steps per second

Do not infer a ratio from a published benchmark. Procgen’s authors describe 16 procedurally generated environments and thousands of environment steps per second on a single CPU core in that benchmark’s environment-specific implementation. JaxMARL reports around 14× improvement in wall-clock time, and up to 12,500× with multiple vectorized training runs, for the comparisons and setup evaluated in its NeurIPS 2024 paper. Those figures illustrate how parallelism can change feasibility; they are not guarantees for arbitrary environments.

Choose an architecture that matches your scale

Pattern Strengths Costs and risks Best fit
Synchronous in-process loop Few moving parts, easy debugging, straightforward reproducibility Stragglers and environment stalls idle the learner; limited fault isolation Early experiments and small, uniform environments
Parallel actors with a shared learner Higher collection throughput and independent worker failures Parameter synchronization, serialization, and queue management become important Many similar environments with a stable policy interface
Rollout service with an API Separate scaling of agent inference, sandboxes, and learning; suitable for multi-turn tasks Network latency, service versioning, and operational complexity Tool-using or software-engineering agents with heterogeneous episodes
Dynamic resource scheduler Can react to heavy-tailed rollouts and changing compute, memory, or communication demand Harder to tune and reproduce; scheduling overhead must be measured Large heterogeneous workloads where static allocation leaves idle capacity
GPU-vectorized environments Very high throughput when the simulator and algorithm map well to a device Requires compatible environment code; device memory and synchronization can become bottlenecks Compatible multi-agent or physics workloads such as those studied by JaxMARL

A practical implementation sequence

  1. Instrument one complete episode. Record environment-step, inference, reward-calculation, storage, and update times, plus every reset and failure.
  2. Establish deterministic controls. Pin environment and policy versions, store seeds, define timeouts, and verify that a replayed episode produces the same state transitions where determinism is expected.
  3. Run a single-worker baseline. Measure completed episodes per hour and wall-clock time to a useful evaluation before adding parallelism.
  4. Scale environment workers first when they are the bottleneck. Increase CPU workers or improve environment vectorization while watching contention, reset latency, and memory use.
  5. Separate inference from learning when utilization diverges. Give inference its own batching or service path if learner updates are starving action generation, or reduce rollout concurrency if trajectories accumulate faster than they are consumed.
  6. Add queue-based scheduling for irregular episodes. Use leases, heartbeats, retries, and explicit handling for failed, timed-out, and skipped tasks.
  7. Introduce checkpointed evaluation. Test each policy checkpoint on a fixed held-out suite and a fresh generated suite, recording confidence intervals or other uncertainty measures appropriate to the task.
  8. Scale out only after profiling. Re-run the same workload profile after each hardware or software change so a throughput gain is not confused with a learning or generalization gain.

Measure the system with more than GPU utilization

Track these measures together:

  • Environment steps per second and completed episodes per hour.
  • Episode-length percentiles, timeout rate, and worker straggler time.
  • Policy actions or tokens per second, inference latency distribution, and learner updates per second.
  • Queue depth, queue wait, parameter age, and data-transfer volume.
  • CPU saturation, GPU utilization, accelerator memory, host memory, and storage throughput.
  • Environment, inference, and training failure rates, classified by cause.
  • Wall-clock time and operational cost to reach a statistically useful evaluation, not merely to complete a fixed number of steps.

This is an operational measurement set derived from the pipeline’s components, not a standardized scorecard published by one authority. Keep benchmark score, throughput, cost, and robustness as separate results. More environment steps per second do not prove that the policy learns faster or generalizes better.

Evaluation, generalization, and evidence

Reserve task instances that the learner never sees during training. Procedurally generated train and test distributions are one practical method; for real software or embodied tasks, maintain an explicit held-out suite and document how it differs from training tasks.

Define success before running evaluation. State whether a reported rate uses launched, completed, or only non-error trials, and how timeouts, crashes, and skipped cases are counted. A 2026 audit by Masters, Liu, and Albrecht, listed by the Autonomous Agents Research Group, examined 50 repositories and reported that none included failed, errored, and skipped run counts alongside headline scores. The lesson is operational: preserve the denominator and every exclusion, not just successful trajectories.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

For each evaluation record, retain the checkpoint identifier, environment version, task identifier, seed, start and end timestamps, termination reason, reward components, tool outputs, and raw outcome. This evidence lets another operator distinguish a genuine policy change from a change in task generation, infrastructure, or reporting rules.

Published figures and how to interpret them

  • Procgen: 16 procedural environments and thousands of environment steps per second on a single CPU core, with a calibrated training description involving approximately 200 million timesteps. These are properties of the 2019 Procgen benchmark and its implementations.
  • JaxMARL: around 14× wall-clock improvement, and up to 12,500× with multiple vectorized training runs, as reported by the authors for their NeurIPS 2024 comparisons. The result depends on the tested multi-agent workloads and vectorization setup.
  • DynaRL: up to 1.98× end-to-end throughput improvement in the math-reasoning and agentic-RL workloads evaluated for the USENIX OSDI 2026 paper.
  • Distributed RL systems: the NVIDIA Research analysis concludes that actor count and hardware assigned to environment interactions are primary performance and power-efficiency limiters in its studied systems.

Use these numbers to identify questions for your own benchmark, not as sizing promises. Different observation formats, simulators, policies, and episode-length distributions can reverse the bottleneck.

Common failure modes and fixes

The learner is idle despite available GPU capacity

Check environment-step latency, worker CPU saturation, reset time, and rollout queue depth. Add or optimize actors, reduce serialization overhead, or move compatible simulation work to an accelerator before buying a larger learner GPU.

Workers finish unevenly and synchronization stalls

Plot episode-length percentiles and straggler time. Replace a global barrier with queues or minibatches, use work stealing, and apply bounded retries for failed tasks. Keep the original termination reason so retries do not inflate success counts.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Trajectories consume all memory

Estimate bytes per observation, action, and metadata multiplied by concurrent episodes and retention time. Compress or reference large observations, stream completed trajectories to durable storage, and impose backpressure rather than allowing unbounded queues.

Training improves but held-out performance does not

Verify that test tasks are genuinely held out, vary procedural seeds, inspect reward components, and compare against a fixed evaluation protocol. A faster rollout loop can amplify overfitting just as efficiently as it amplifies learning.

Results cannot be reproduced

Check that seeds, environment versions, policy checkpoints, parameter versions, task lists, and failure counts were recorded. Pin dependencies and retain the exact evaluation configuration alongside the score.

Frameworks and current project choices

ProRL Agent is described by Microsoft Research as open-source and integrated into NVIDIA NeMo Gym. RLinf’s public repository lists integrations across several accelerator and framework ecosystems and includes embodied-agent use cases. Project repositories and announcements change, so verify current versions, supported combinations, and deployment requirements in their documentation before adopting them.

Neither project removes the need to profile your own environment. A framework can provide actor management, vectorization, or logging while your simulator, model, sandbox, or network remains the limiting component.

How to decide whether you need a cluster

A single machine is often the right starting point when one policy, a modest number of environments, and a reproducible evaluation fit in memory. Move to multiple machines when measured CPU execution, accelerator memory, environment isolation, or fault-domain requirements prevent the single host from keeping the learner supplied. A rollout service or dynamic scheduler becomes justified when episodes are sufficiently heterogeneous that static workers remain idle or when independent scaling materially reduces queue wait.

Do not select hardware from a generic shopping list. The available evidence does not establish current cloud prices, a universal cluster size, or a required accelerator model. The defensible process is to profile a representative run, calculate the cost and wall-clock time per completed useful episode, and then compare architectural changes against that baseline.

Frequently Asked Questions

Is a powerful GPU enough to train a long-horizon RL agent?

No. Environment execution, rollout orchestration, inference, storage, communication, and evaluation can each become the bottleneck. A GPU that is underfed by CPU-bound actors will not raise end-to-end throughput.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Should environments run on CPUs or GPUs?

Use the device that matches the environment implementation and profile. CPU actors suit many conventional or sandboxed environments; GPU-vectorized execution can be dramatically faster for compatible multi-agent or simulation workloads, but published speedups are benchmark-specific.

When should rollout generation be a separate service?

Consider separation when episodes are multi-turn, tool-heavy, or highly variable in length, or when inference and sandbox capacity must scale independently. A simple in-process loop remains easier to debug for small, uniform workloads.

What must every trajectory record contain?

At minimum, retain environment and task version, seed, policy checkpoint, timestamps, observations or references, actions, reward components, termination reason, and relevant tool outputs. Also classify failed, errored, and skipped runs separately from successful completions.

How can I estimate the infrastructure I need without a fixed hardware recipe?

Run a representative end-to-end workload, measure environment steps, episode-length percentiles, inference and learner throughput, queue wait, memory, transfer volume, failures, and time to useful evaluation. Add capacity only at the measured bottleneck and repeat the profile after each change.
