Short answer: neither family is universally better. A conventional U-Net is the reproducible baseline and often the easiest model to train, inspect and deploy. An attention-augmented U-Net reweights features inside that encoder-decoder. A genuine dual-stream model adds a second representation or supervision path, such as a skeleton stream that teaches the network about crack topology. Those are different design choices, even when papers use similar names.
Published results suggest that attention and extra streams can improve thin-crack discrimination, continuity or contextual reasoning, but the gains are tied to each paper’s images, labels, split, loss and hardware. The only defensible way to choose is to run a controlled comparison and measure both segmentation quality and deployment cost.
What the terms mean
U-Net: the reference architecture
U-Net uses an encoder to reduce an image to increasingly abstract feature maps and a decoder to restore spatial resolution. Skip connections copy features from matching encoder stages into the decoder, helping recover narrow edges and small cracks that would otherwise disappear during downsampling. The design is compact, straightforward to reproduce and supported by mature training recipes, which is why it remains the baseline in crack-segmentation studies.
Attention-augmented U-Net
An attention block learns which channels, pixels, neighborhoods or scales deserve more weight. In a crack image, that can suppress smooth concrete, stains or shadows while preserving a faint line. “Dual attention” normally means two attention mechanisms—often spatial plus channel attention, or local plus global attention—inside one feature stream. It does not automatically mean that the network has two streams.

Dual-stream model
A dual-stream network maintains two feature or prediction paths. The streams may process complementary representations, or one stream may provide an auxiliary target during training. They can exchange information through fusion layers, skip connections or attention gates. The additional path is intended to supply information that a single mask loss does not express well, such as connectivity, orientation or shape.
Consequently, “dual attention” and “dual stream” are not interchangeable labels. A model can contain dual attention without being dual-stream, and a dual-stream model may use no attention at all. Read the block diagram and loss function rather than inferring architecture from the name.
Why crack segmentation is unusually difficult
Cracks are thin, fragmented and often only a few pixels wide. Illumination changes, camera distance, compression and surface texture alter their appearance. Water stains, shadows, repair grout, joints and mural decoration can look like cracks. Downsampling can erase a line; aggressive thresholding can break a continuous crack into islands. A useful model therefore needs both pixel-level detail and enough context to decide whether a line is structurally plausible.
Pixel overlap alone does not capture that last requirement. A prediction can obtain reasonable IoU while containing gaps that make an inspection map unusable. Conversely, a model that traces a crack continuously may include a small amount of extra area. Evaluation should therefore combine overlap metrics with visual and topological checks.

|---|---|---|---|---|
| DSU-Net (2023) | Dual-stream U-Net design for difficult scenes | Pavement cracks with water stains, shadows and repair grouting; 5,000-image dataset | Test-set mean F1 74.17%; stated comparison methods 68.09% | It is not a cross-paper win over every U-Net or attention model. |
| SkelTAG-Net (published 2026-10-08) | Shared encoder, symmetric segmentation and supervised skeleton streams; topological attention gate | CrackVision12K | IoU 0.676, F1 0.781, clDice 0.848; abstract says it outperforms compared models including U-Net and SegFormer-B2 | Results are specific to CrackVision12K and the paper’s setup; it is an early-access article. |
| L-DANet (2025) | Four-stage U-Net at one-quarter channel depth with a compact dual-attention block at the deepest layer | Pixel-labelled concrete-crack benchmark | 7.4 MB weights, 19% additional computation, IoU 0.827 and F1 0.905; 110 FPS on a 10 W Jetson Nano and 220 FPS on a 5 W Coral TPU in the reported hardware-in-the-loop setup | FPS depends on that hardware, workload and implementation; it is not transferable to another device. |
| DADNet (2024) | Neighborhood attention plus biaxial attention in U-Net skip connections | Tomb-mural cracks | The paper targets local detail and global dependencies; a single cross-domain score should not be inferred from the description. | Mural imagery differs materially from pavement or concrete imagery. |
| MA-Xnet (2022) | Mobile-attention network combining U-Net and DANet ideas | Crack-segmentation experiments described by the paper | 82.33% parameter reduction versus U-Net, with reported F1 and mean-IoU improvements in its experiments | The reduction and metric gains are tied to the paper’s baseline and test setup. |
| MDAU-Net (2023 conference paper) | Multi-scale U-Net, dual-attention module and hybrid weighted segmentation loss | DeepCrack and Crack500 evaluation | The abstract describes evaluation on both datasets | The abstract alone does not establish a universal ranking or identical training conditions. |
| Full Attention U-Net (2021 preprint) | Full-attention treatment of encoder outputs in skip connections | Crack-segmentation validation after comparisons on cell images | Reports validation comparisons in a preprint | Preprint evidence should be treated as provisional and not equivalent to a peer-reviewed benchmark. |
DSU-Net’s 74.17% versus 68.09% mean-F1 result is a within-study comparison on its 5,000-image pavement dataset. SkelTAG-Net’s clDice value is especially relevant when a continuous crack trace matters, while L-DANet supplies unusually concrete size, compute and edge-device figures. None of those facts makes one architecture the winner on a different camera, material or split.
How attention or a second stream can help
Suppressing look-alike texture
Channel or spatial attention can increase the response to elongated, high-contrast structures and reduce responses to broad stains or aggregate texture. Neighborhood attention limits context to useful local regions; biaxial or other global mechanisms can connect evidence that is separated in the image. The benefit is conditional: if the training set does not contain the nuisance patterns seen in deployment, the learned weighting may not generalize.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Clear out junk files and repair common Windows errors3Fix the driver behind crashes, sound loss and screen glitchesPreserving thin structures
A decoder trained only with pixel-wise overlap can favour thick, easy regions and omit a one-pixel branch. A skeleton or boundary stream supplies an auxiliary signal about the medial axis or edge. SkelTAG-Net explicitly uses a supervised skeleton stream and a topological attention gate to feed structural information into the segmentation decoder. This design is aimed at continuity, not merely a higher foreground count.
Using multiple scales
Cracks appear at different widths and image resolutions. Multi-scale U-Net variants expose the decoder to both fine and coarse features. MDAU-Net combines that strategy with dual attention and a hybrid weighted loss; the reported evaluation covers DeepCrack and Crack500. When reproducing such a result, keep the scale pyramid, crop policy and loss weights unchanged, because each can materially alter the outcome.
Reducing cost while retaining context
Attention does not have to make a model large. L-DANet reduces channel depth to one-quarter of its four-stage U-Net and places a compact dual-attention block at the deepest layer. Its authors report a 7.4 MB weight budget and 19% additional computation. MA-Xnet reports 82.33% fewer parameters than its U-Net reference. These are examples of design trade-offs, not guarantees that every attention block is cheaper.

Which is better for crack segmentation: U-Net or an attention model?
Use the plain U-Net when you need a transparent baseline, have limited labelled data, or must diagnose whether errors come from data and labels rather than a complex module. Its regular skip connections make ablation simple: train the baseline, then add one block at a time.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
Choose an attention-augmented U-Net when false positives arise from known textures, when cracks require wider context, or when an edge device can afford the measured overhead. A compact design such as L-DANet may be a better engineering choice than a large transformer-like network if memory and power are strict.
Choose a genuine dual-stream model when continuity, branching or structural plausibility is a primary deliverable. A skeleton stream can make that objective explicit. Expect extra labels, loss terms, tuning and failure modes: an inaccurate skeleton target can teach the network the wrong topology, and two streams can increase memory even when the final mask is small.
These recommendations are decision rules, not a claim of universal superiority. The correct model is the one that meets your required error profile on images collected under the conditions in which it will be used.
Does dual attention improve crack segmentation?
Several papers report improvements after adding attention, but “improve” must be read within each experiment. L-DANet reports IoU 0.827 and F1 0.905 on its concrete-crack benchmark; MA-Xnet reports F1 and mean-IoU gains while reducing parameters; DADNet adds neighborhood and biaxial attention for tomb murals; and MDAU-Net evaluates a multi-scale, dual-attention design on DeepCrack and Crack500. These results support attention as a promising mechanism, not as a controlled proof that dual attention always beats U-Net.

To establish an improvement in your project, compare the same baseline and attention variant with identical data, preprocessing, augmentations, optimizer, epochs or compute budget, threshold selection and random-seed policy. Report confidence intervals or variation across seeds when the dataset is small. Include qualitative error cases, because a small average gain can hide catastrophic failures on shadows or repaired surfaces.
A fair U-Net versus dual-stream evaluation protocol
- Lock the dataset and split. Use identical labelled images, with no near-duplicate crops from the same source structure crossing train, validation and test sets. A random crop split can leak texture and camera conditions.
- Define the deployment image. Record sensor type, colour space, resolution, crop or tiling rule and expected crack width. Apply exactly the same resizing and normalization to every model.
- Fix training conditions. Match augmentation, loss, optimizer, learning-rate schedule, batch size, epoch count or total training compute. If a dual-stream model needs an auxiliary skeleton label, create that label once and document the thinning algorithm.
- Set thresholds fairly. Choose the probability threshold on the validation set only, then freeze it for the test set. Do not tune one model on test images.
- Measure overlap and topology. Report IoU and F1 together. Add clDice when preserving connected, one-pixel-wide structures is important. Also report precision and recall so a higher F1 is not mistaken for fewer false positives in every operating regime.
- Inspect hard negatives. Create a fixed error panel containing shadows, water stains, grout, joints, aggregate, mural decoration and severe blur. Record missed branches, broken lines and spurious blobs separately.
- Measure deployment cost. Record parameter count, serialized weight size, peak memory, batch-one latency, sustained FPS and power on the target device. Warm up the device and state precision mode, input size and whether preprocessing is included.
- Test generalization. Hold out a material, lighting condition, camera distance or crack-width range. A model that wins on one benchmark may fail when the surface or acquisition process changes.
- Run ablations. Remove the attention block, the second stream and each auxiliary loss in turn. This identifies which component produces the observed change and whether the added complexity is justified.
Choosing metrics that match the inspection task
IoU
Intersection over Union divides the predicted foreground intersection by the union of prediction and ground truth. It penalizes both missing crack pixels and extra pixels, making it useful for area agreement. Very thin cracks can still receive a modest IoU when a visually important line is slightly shifted.
F1 score
F1 is the harmonic mean of precision and recall. It balances missed crack pixels against false detections, but it remains pixel-based and does not guarantee that separate fragments are connected.
clDice
clDice evaluates skeleton overlap and is designed to reflect topology. It is appropriate when an inspection workflow needs a continuous path for measuring length, branching or connectivity. SkelTAG-Net reports clDice 0.848 on CrackVision12K alongside IoU 0.676 and F1 0.781, illustrating why a topology-sensitive metric can add information beyond overlap.

For a mobile or embedded inspection system, a mask that arrives too late or exceeds memory is not useful. Track batch-one latency, sustained throughput, peak RAM or accelerator memory, power draw and startup time. L-DANet’s reported 110 FPS on a 10 W Jetson Nano and 220 FPS on a 5 W Coral TPU are hardware-in-the-loop results from that study; they should not be quoted as expected rates for another board.

Data and labeling practices that often matter more than the block
Audit labels for inconsistent crack width, uncertain boundaries and omitted hairline branches. Decide whether stains, joints and repair seams are negative examples or a separate class. Keep source structures together during splitting. Include examples from wet and dry surfaces, oblique lighting, shadows, different camera heights and both wide and hairline cracks.
If a skeleton stream is used, verify the derived skeletons manually. Morphological thinning can create spurs at noisy boundaries or erase close parallel lines. Store the original mask and the skeleton-generation parameters so that a later experiment can reproduce the target. Do not silently change label morphology between the baseline and dual-stream runs.
Common failure modes and fixes
The model traces stains or grout
Add hard-negative examples and inspect whether attention is amplifying a texture correlated with cracks in the training set. Use structure-aware augmentation and evaluate precision on a stain-only subset. Changing the architecture without changing those examples rarely solves the root cause.

Cracks are detected but broken into pieces
Check image resolution, downsampling depth and decoder skip alignment. Add a continuity-sensitive metric such as clDice and consider an auxiliary skeleton or boundary target. Avoid post-processing that joins nearby objects indiscriminately; it can connect unrelated marks.
Thin branches disappear
Use crops or tiles that retain enough pixels per crack, preserve high-resolution features and examine the loss weighting for rare foreground pixels. A dual stream helps only if the auxiliary target contains the branches and the stream’s features are actually fused into the final decoder.
Validation is high but field performance is poor
Look for leakage between crops from the same slab, road segment or mural. Rebuild splits by source structure, then test on a different material or camera. Calibrate the probability threshold on representative validation images rather than selecting it on the easiest images.
Edge inference is slower than the paper’s FPS
Match input dimensions, precision, compiler, batch size and preprocessing when reproducing a published number. Measure end-to-end latency on the exact target hardware. A smaller weight file does not necessarily mean lower latency if an attention operator is poorly supported by the runtime.
Practical selection checklist
- Start with a plain U-Net baseline and publish its split, preprocessing and training budget.
- Add one attention mechanism before adding multiple streams, so the source of any gain is identifiable.
- Use a dual-stream design when you can define and validate a useful second target such as a skeleton.
- Report IoU and F1; add clDice for connectivity-critical inspection.
- Keep pavement, concrete and mural results in their own context instead of ranking them together.
- Record model size, memory, latency, FPS and power on the deployment device.
- Test hard negatives and an out-of-domain set before selecting a model for field use.
- Prefer the simplest model that meets the required accuracy, continuity and real-time constraints.
Bottom line for practitioners and researchers
U-Net is the baseline against which complexity should earn its place. Attention can focus features or add context; a dual stream can encode a second objective such as topology. The published studies show useful, domain-specific gains—including the compact edge results of L-DANet and the topology-focused metrics of SkelTAG-Net—but they do not establish a universal winner. Build a controlled ablation on your own images, judge continuity as well as overlap, and include hardware measurements before committing to an architecture.
