For most payment businesses, a measured hybrid is the safest starting point: keep explicit rules for non-negotiable conditions and known attack patterns, then use machine-learning risk scores to add behavioral and historical context. Set the action threshold from your own fraud loss, false-decline cost and customer value, and validate the result continuously. Neither rules nor a model score is a complete fraud policy by itself.
What the two approaches actually do
Rules-based detection
A rules engine evaluates conditions written by people. Typical conditions include transaction amount, purchase frequency, country or region, device or IP characteristics, payment instrument history, and membership in known allowlists or blocklists. A rule can block a payment, send it to review, require additional authentication, or allow it to proceed.
The main strength is legibility. An analyst can read a condition, explain why it fired, and change it without retraining a model. Rules are also the direct way to enforce a business policy, such as refusing transactions from a prohibited jurisdiction or requiring review above a specified amount.
The weakness is that a rule sees the cases described by its conditions. Attackers can vary an amount, rotate accounts, or distribute activity just below a frequency limit. As exceptions accumulate, the rule set becomes harder to test and maintain. A clear rule can still create expensive false declines if it is too broad.

Machine-learning detection
A machine-learning system learns statistical relationships from historical examples and other signals, then produces a risk score or classification for a new payment. Depending on the implementation, features can include customer and transaction history, device and behavioral patterns, payment-network relationships, and signals shared across a wider ecosystem.
That context lets a model identify combinations of weak signals that do not match a single known rule. It can also adapt as patterns change, provided the training data remains relevant and the system is retrained or otherwise updated.
Flexibility creates obligations. The business needs suitable, representative data; reliable labels; validation that includes false positives and false negatives; controls for privacy, security and bias; explanations adequate for operations; and monitoring for drift. A score is not a policy decision. The business still chooses what score causes approval, review, authentication or blocking.

Rules versus machine learning at a glance
| Decision factor | Rules-based system | Machine-learning scoring |
|---|---|---|
| How it decides | Human-authored conditions and lists | Patterns inferred from data, producing a score or class |
| Best fit | Known, stable patterns; explicit policy constraints; limited labeled history | Varied or shifting fraud; sufficient transaction history and relevant features |
| Explainability | Usually direct: the firing condition is visible | Requires feature, reason-code or explanation tooling; complex methods can be difficult to explain |
| Change speed | A targeted rule can be changed immediately, subject to testing and approvals | Changing behavior may require recalibration, retraining or a controlled policy change |
| Adaptability | Attackers can work around known thresholds and conditions | Can recognize new combinations of signals if they are represented in data |
| Data requirement | Can operate with little or no labeled history | Needs appropriate data, labels and coverage of the populations being scored |
| Operational burden | Rule growth, conflict resolution, tuning and regression testing | Data pipelines, validation, calibration, drift monitoring, governance and review |
| Primary failure mode | Missed variants or excessive false declines from broad conditions | Data shift, hidden bias, poor calibration, delayed labels or opaque decisions |
When rules should lead
- The pattern is known and stable. A confirmed attack signature or a legal and business restriction is easier to express as a condition than to infer.
- You have little reliable labeled history. A model trained on sparse or unrepresentative outcomes can create false confidence. Start with observable controls while collecting outcome data.
- A policy must be explicit. If a transaction must always be blocked, allowed, or routed for review under a documented policy, a rule supplies an auditable condition.
- You need an immediate, targeted response. A temporary rule can address a live campaign while a longer-term model or data investigation is under way.
These reasons do not make rules self-sufficient. Track approval, review and confirmed-fraud outcomes for every important rule. Retire rules that no longer add signal, and test interactions so that a new exception does not silently override a more important control.
When machine-learning scoring earns its place
- There is enough history and coverage. You need transaction, customer and outcome data that represents the channels, regions, payment methods and customer segments you will score.
- Fraud is varied or changing. A score can combine behavioral, historical and network context rather than waiting for an analyst to enumerate every new pattern.
- You can measure both kinds of error. The team must investigate missed fraud and legitimate customers incorrectly challenged or blocked.
- You can operate the model. That includes calibration, threshold management, delayed-label handling, monitoring, incident response and a process for human review.
Do not deploy a model merely because it produces a sophisticated score. If the organization cannot explain who is affected, retain evidence, investigate outcomes and change or retire the system, the operational risk may outweigh its analytical benefit.

Why a hybrid policy is usually the practical starting point
A hybrid design gives each method a distinct job. Hard rules enforce non-negotiable constraints and domain-specific exceptions. A model ranks the remaining transactions by contextual risk. The policy then maps those results to actions.
A typical decision flow
- Apply mandatory controls. Check sanctions or jurisdiction restrictions, confirmed compromised instruments, impossible transaction states and other conditions that must take precedence.
- Gather signals. Assemble transaction, account, device, behavioral and payment-method data permitted for the use case.
- Calculate a risk score. The model estimates relative risk; it does not decide the commercial action.
- Apply custom rules and exceptions. A trusted-customer treatment, a known attack pattern or a required authentication path may modify the default score policy.
- Choose an action band. Low-risk payments may be approved, middle-band cases reviewed or challenged, and high-risk cases blocked.
- Record the evidence and outcome. Store the rule decisions, score or reason codes, action, reviewer result and eventual fraud or authorization outcome under appropriate retention controls.
Provider documentation for products such as Adyen Protect describes custom rules that complement machine-learning risk classifications, along with rule backtesting and experiments in some plan tiers. That capability illustrates the architecture; it is not evidence that one provider outperforms another.

Suppose a model assigns higher scores to riskier payments. Lowering the blocking threshold usually blocks more transactions: recall (fraud caught) rises, but precision among blocked payments can fall and more legitimate customers may be rejected. Raising the threshold usually improves precision while reducing recall. No single threshold maximizes fraud capture, approval rate and customer experience at the same time.
Use an economic, not cosmetic, threshold
Estimate the expected cost at candidate thresholds for each important segment, payment method and region. Include:
- Direct fraud and chargeback loss, including investigation and recovery costs.
- False-decline cost: lost margin, lost subscription or repeat purchases, support contacts and customer churn.
- Review cost and the capacity of the operations team.
- Authentication or challenge cost and its effect on conversion.
- Customer lifetime value, especially where one rejected first purchase can forfeit many future orders.
Adyen gives two contrasting examples rather than universal rules: a thin-margin merchant with high operational fraud costs may rationally block at a lower risk level, while a seller of mostly digital goods may accept more fraud risk if a false decline destroys more lifetime value. Calculate the trade-off for your own business, payment method, region and customer mix.

Separate model quality from policy quality
Evaluate the model on held-out validation examples rather than only on training data, then evaluate the actual production policy at the threshold you intend to use. A model can rank cases well while a poorly chosen threshold causes excessive declines. Conversely, a modest model can support a sensible review band when the economics and operations are well designed.

Fraud labels often arrive after the transaction through disputes, investigations or customer reports. State the outcome window used in evaluation and account for delayed labels when comparing recent cohorts with mature ones. Do not treat unlabeled recent payments as confirmed legitimate.
Metrics that belong on the same dashboard
| Metric or outcome | What it tells you | Why it needs context |
|---|---|---|
| Recall | Share of confirmed fraud detected | Can rise while legitimate approvals fall |
| Precision | Share of blocked or reviewed payments that are actually fraud | Depends on the action band and fraud prevalence |
| False-positive rate | Legitimate payments incorrectly treated as risky | Its commercial cost differs by customer and payment method |
| Fraud loss and chargebacks | Realized financial damage | Labels can be delayed and recovery can change net cost |
| Approval or authorization rate | Payments successfully accepted | Must be segmented so a broad average does not hide affected groups |
| False-decline cost | Margin, lifetime value and support impact of rejecting legitimate customers | Often exceeds the immediate order value |
| Review workload | Cases and handling time sent to people | Capacity limits can turn a theoretically good policy into a queue |
| Customer friction | Challenges, authentication steps and abandonment | Measure by journey and device, not only globally |
Report these measures at the policy threshold actually used. A model-wide metric that ignores your block, review and challenge bands cannot tell you what customers experience.
Data, governance and security requirements
The OECD’s 2021 fraud-detection lifecycle analysis notes that systems may process sensitive personal and geolocation information. Before using such signals, define the lawful purpose, access controls, retention period and deletion process applicable to your organization and jurisdictions.
Data quality and representativeness
- Check missingness, duplicate events, timestamp errors and inconsistent identifiers.
- Measure whether training and validation data cover the channels, regions, payment methods and customer populations in production.
- Document label definitions, fraud-confirmation sources and the delay between a payment and a confirmed outcome.
- Watch for feedback loops: if you block a segment, you may stop collecting the outcomes needed to assess that segment.
Fairness and explainability
Review whether proxies such as location, device or language create disparate error rates for groups that are not inherently more fraudulent. Provide reason codes or an analyst-facing explanation sufficient to investigate a decision. Complex or unsupervised approaches can be harder to explain, so explanation requirements should influence model and feature selection.

Adversarial testing and monitoring
Test evasion attempts against rules and models, including small changes to amount, device, account and payment behavior. In production, monitor score distributions, feature availability, action rates, fraud outcomes, false declines and review queues. Establish alert thresholds, an owner for each alert, rollback procedures and a documented process to adjust or retire a rule or model.
Human involvement remains important. Decide who can override a decision, what evidence must be retained, how overrides are audited and when a customer can appeal or retry through a safer path.
Implementation plan for a payment team
- Define the loss function. Write down fraud cost, false-decline cost, review capacity and customer-value assumptions by segment.
- Inventory available signals. Map data sources, latency, missing fields, privacy restrictions and payment-method coverage.
- Document current rules. Record purpose, owner, precedence, test cases, firing rate and observed outcomes for every rule.
- Create a time-aware evaluation set. Hold out later transactions where possible, preserve delayed outcomes and prevent information from after the payment leaking into features.
- Establish action bands. Define approve, challenge, review and block outcomes, plus the escalation path when a signal is unavailable.
- Backtest and replay. Compare rules alone, model scoring alone and the hybrid policy on representative historical data. Examine segment-level error and cost, not only aggregate metrics.
- Run a controlled rollout. Start with a limited traffic slice or a shadow score, then change one threshold or rule at a time so effects are attributable.
- Monitor mature outcomes. Reconcile recent decisions with later disputes and investigations, using an explicit label window.
- Review and retire. Schedule governance reviews, remove stale rules, recalibrate thresholds and document every material change.
How to assess product capabilities without trusting marketing metrics
Current products illustrate different combinations of rules and scoring, but official product pages are not independent head-to-head benchmarks. Stripe Radar describes AI-based fraud prevention, custom rules, scores and an API for bringing its intelligence into an existing stack. Adyen Protect documentation describes machine-learning risk classifications, configurable block thresholds, risk signals and custom rules; its Help Center distinguishes Basic and Premium offerings, with Premium adding capabilities such as machine-learning detection, custom rules, backtesting, experiments and case management. Availability, geography, payment-method scope and plan boundaries can change, so confirm them directly with the provider.
Sift describes machine-learning fraud prevention, while Forter describes digital-commerce fraud management. The available material does not establish comparable prices or independent performance for these services. Treat their claims as vendor-reported capabilities, not proof that one approach or provider has a universal advantage.

Common mistakes and their fixes
“The highest score should always be blocked.”
Fix: Set action bands from measured fraud and false-decline economics. Reserve review or authentication for cases where blocking would destroy disproportionate customer value.

“A model replaces all rules.”
Fix: Keep explicit controls for mandatory restrictions, known compromises and domain-specific exceptions. Use the model for contextual ranking.
“A growing rule list means better protection.”
Fix: Track incremental value, conflicts and false declines. Remove rules that no longer improve outcomes and test combinations before release.
“Offline accuracy proves production readiness.”
Fix: Use held-out, time-aware data; account for delayed labels; then monitor live scores, action rates and mature fraud outcomes.
“One global metric is enough.”
Fix: Segment by payment method, region, customer tenure, device and action band. Averages can conceal a severe experience or fairness problem.
“Vendor percentages are comparable.”
Fix: Ask for definitions, populations, time windows and thresholds. Prefer a controlled test on representative historical or shadow traffic.
Choosing your starting architecture
| Your situation | Practical starting point | Next capability to add |
|---|---|---|
| New program, little labeled data | Small, auditable ruleset with outcome logging and manual review | Better labels, feature coverage and a controlled score experiment |
| Stable attack signature or mandatory restriction | Targeted rule with regression tests and expiry or review date | Contextual scoring to catch variants and reduce broad blocking |
| Large, diverse transaction history | Calibrated model score plus explicit policy rules | Segment-specific thresholds, experiments and drift controls |
| High customer lifetime value or digital delivery | Hybrid policy with challenge and review bands before hard blocking | Economic optimization using mature fraud and false-decline costs |
| Limited operations capacity | Rules and score bands sized to a known review queue | Automation only after monitoring proves that overrides are safe |
The decision
Choose rules first when conditions are explicit, stable or poorly supported by data. Add machine-learning scoring when you have representative history, shifting patterns and the operational ability to validate and monitor it. For most payment businesses, combine them: rules enforce what must happen, a model supplies context, and a threshold policy converts risk into an action whose cost you can measure.
