Machine-learning ransomware detection watches what programs do rather than waiting for a known file signature. It can score unusual file writes, API and process activity, and changes in file-content entropy, then raise an alert or trigger a prevention action. That makes it useful against previously unseen samples, but it is not a guarantee: detection quality depends on telemetry, observation timing, normal workload, model validation, and whether an attacker deliberately changes the behavior being measured.

What machine-learning ransomware detection actually does

A ransomware detector based on machine learning is usually a behavior-scoring system. An endpoint sensor records events such as process creation, file opens and writes, API calls, renames, privilege use, and other host activity. The detector converts those events into features over a time window, applies a trained classifier or anomaly score, and sends an alert to an analyst or an automated control.

MITRE ATT&CK’s description of endpoint behavior prevention treats heuristics, machine learning, and real-time monitoring as different techniques that can operate on process, file, API, and other endpoint events. Machine learning is therefore one component of endpoint defense, not a replacement for signatures, allowlisting, monitoring, backups, or incident response.

Why behavior matters

Known-signature tools are strong when a file or activity matches a previously identified pattern. Behavior-based scoring can identify activity that differs from a learned baseline, including a new binary whose hash is not in a signature database. The trade-off is uncertainty: an unusual backup, software update, administrator script, or bulk data conversion can resemble malicious activity, while a careful attacker can try to look normal.

A practical detection pipeline

  1. Collect endpoint telemetry. Capture process, file, API, user, path, and security-control events with timestamps and stable identifiers that connect a process to the files it touched.
  2. Normalize and enrich. Convert operating-system-specific records into consistent fields, add signer or parent-process context where available, and separate duplicate or failed operations from successful changes.
  3. Build time-window features. Count and rate file reads, writes, renames, deletes, and extension changes; measure how many distinct directories and users are involved; and calculate content or byte-level statistics when policy permits.
  4. Score the activity. A supervised classifier can estimate the probability of ransomware-like behavior, while an anomaly model can measure distance from a baseline. Rules and thresholds can be combined with the score.
  5. Surface an actionable result. Send an alert with the responsible process, host, user, paths, timing, and supporting events. A prevention action might suspend a process, block a write, isolate a host, or require analyst approval, depending on the confidence and business impact.
  6. Investigate and respond. Analysts validate the signal, identify affected systems, preserve evidence, contain the spread, and begin recovery. NIST’s data-integrity guidance treats detection, impact analysis, containment, and response as linked activities.

The important design choice is not a particular algorithm. It is whether the pipeline retains enough context and time to distinguish a destructive sequence from legitimate high-volume work.

Signals that can reveal encryption activity

File input/output activity

Ransomware commonly performs many file operations in a short period. Useful measurements can include write rate, the ratio of reads to writes, repeated open-write-close sequences, renames, deletion of originals, creation of unfamiliar extensions, and the number of folders or shares touched. Parent-process identity and the relationship between a process and its child processes add context.

These are signals, not verdicts. Indexers, backup agents, compression tools, database maintenance, and large software deployments can also generate high I/O. A production model needs a baseline for the organization’s workloads and an allowlist or suppression process for known benign jobs.

File-content entropy

Encryption and compression can change the statistical distribution of bytes in a file. A detector can calculate entropy before and after a write, or compare the entropy of output files with the source files. Yang and Sahita’s 2020 arXiv case study specifically examined file I/O activity and file-content entropy. The researchers wrote: “We find that input/output activities of ransomware and the file-content entropy are unique traits to detect crypto-ransomware.”

Entropy is not proof of encryption. Compressed archives, media files, database pages, and already-encrypted data may have high entropy, while partial encryption or low-entropy output can reduce the usefulness of the feature. The study reports that an attacker could weaken the classifier by inserting benign I/O events or reducing the entropy signal.

Decoy files and path context

The case study also considered decoy-file events and system-path information. Decoy files can provide an early tripwire when a process touches a protected document that no legitimate application should modify. Path features can distinguish ordinary user folders from sensitive system locations, but they are environment-dependent: drive mappings, cloud synchronization, server shares, and operating-system versions change what a “normal” path looks like.

Temporal behavior

Ransomware is a sequence, not just a single event. Features should preserve ordering and timing: process start, key or configuration changes, bursts of writes, extension changes, and cleanup actions. A 2019 research direction extracted temporal patterns from dynamic-analysis sandbox and host logs using TF-IDF, Fisher’s linear discriminant analysis, and Extra Trees. Those techniques illustrate how event sequences can be modeled; they do not establish universal or production-ready effectiveness.

What the published case study shows—and does not show

Yang and Sahita’s 2020 case study reported initial models with about 98% accuracy and about a 2% false-positive rate. Those figures describe the authors’ dataset and experimental setup, not a general performance promise or a current commercial benchmark. When the researchers moved to live testing, they observed false alarms, missed ransomware, and poor early detection.

Timing was a major limitation. In the authors’ dataset, about 20% of ransomware samples showed malicious events in the first second, while about 20% showed no malicious activity until later than 160 seconds. Smaller observation windows increased misses, and some samples became distinguishable only later in execution. A detector that waits too long may provide a clean score after significant damage; one that acts immediately may interrupt legitimate work.

For a path-flagged model evaluated on roughly 22,000 clean execution logs, the paper reported false-positive rates changing from 0.15% to 0% for an SVM and from 0.09% to 0.04% for an LSTM. These are specific to that setup and should not be converted into expected product rates.

How to evaluate a model honestly

Use more than accuracy

Measure What it tells you Question to document
True-positive rate (recall) How much ransomware the detector catches Which samples and execution stages were included?
False-positive rate How often benign activity is escalated What clean workloads, users, and maintenance jobs were tested?
Precision How many alerts are actually malicious Was the class balance realistic or artificially equal?
Time to alert How much activity occurs before intervention What window size and polling delay were used?
False negatives Which attacks pass without an alert Were late-starting, partial, and evasive samples included?
Operational impact Whether controls disrupt business work How often did analysts need to release or roll back a block?

Keep training, validation, and test hosts or time periods separated. Otherwise the model may memorize a path, binary, or environment instead of learning ransomware behavior. Report the ransomware families, benign sample mix, operating-system versions, privileges, network state, and observation-window length. Evaluate at the alert threshold that operations can actually support, not only at the threshold that maximizes a laboratory metric.

Test adversarial behavior

Include samples that insert benign events between malicious operations, encrypt only part of each file, throttle activity, delay destructive actions, or run through trusted interpreters. The cited study demonstrates why evasion and false-positive analysis must accompany headline accuracy. Retrain or retune only after confirming that a change improves detection without creating an unmanageable alert stream.

Implementing a detector in an enterprise

1. Define the response objective

Decide whether the first action is notification, process suspension, write blocking, host isolation, or a request for analyst approval. A low-confidence anomaly may belong in a queue; a high-confidence burst affecting protected shares may justify immediate containment. Write down who can override the action and how the decision is audited.

2. Map the telemetry you already have

  • Verify that endpoint agents record process ancestry and successful file operations, not only alerts.
  • Confirm timestamp consistency across endpoints, servers, and the central analytics system.
  • Measure event volume, storage retention, and the privacy implications of collecting file names or content-derived features.
  • Identify blind spots such as offline laptops, unmanaged servers, network shares, and virtual machines.

3. Establish benign baselines

Profile normal backup windows, software distribution, developer build directories, database maintenance, media workflows, and user file servers. Baselines should be segmented by host role and time of day; a single organization-wide average can make legitimate server activity look malicious or hide a compromise in a noisy environment.

4. Start in observe-only mode

Run the model without automatic blocking long enough to label false positives and verify that alerts contain enough evidence for triage. Tune thresholds, exclusions, and decoy locations from observed behavior rather than assumptions. Preserve the original events so an analyst can reconstruct the sequence.

5. Add graduated prevention

Enable controls in stages: notify, require confirmation, suspend the process, then isolate the host for selected high-confidence cases. Protect the control plane from the same attack; an adversary that disables the agent or deletes its logs can defeat a technically accurate model.

6. Exercise recovery

Test that responders can identify the source and affected systems, collect evidence for impact analysis, isolate systems, and restore clean data. NIST SP 1800-26, published in December 2020, presents an example enterprise solution for data-integrity attacks, including ransomware, and emphasizes swift response. Detection has value only when the organization can act on it.

Machine learning versus other detection layers

Approach Strength Limitation Best use
Known signatures Fast identification of recognized files or patterns Weak against new or modified samples Baseline malware blocking and triage enrichment
Behavior rules and heuristics Transparent conditions such as suspicious mass renames or protected-file access Can be bypassed or noisy when a rule is too broad High-confidence guardrails and explainable alerts
Behavior-based machine learning Combines many weak signals and can score unfamiliar activity False alarms, missed attacks, timing sensitivity, and adversarial evasion Prioritization and adaptive endpoint detection
Real-time monitoring and EDR investigation Provides context, process lineage, and containment actions Requires staffing, retention, and response procedures Validation, scoping, and incident response
Backups and recovery controls Limit the lasting impact of successful encryption Do not detect the initial process Recovery and resilience, tested regularly

CISA’s #StopRansomware guidance recommends centrally managed antivirus and signatures, application allowlisting and/or EDR, centralized security logging and retention, and baselines for normal network traffic. These controls complement a model: signatures catch known threats, allowlisting limits execution, logs support investigation, network baselines reveal spread, and backups support recovery.

Common failure modes and fixes

The model alerts on every large file job

Cause: the detector treats volume as malicious without role or schedule context. Fix: segment baselines, add parent-process and path context, and create reviewed maintenance windows rather than a permanent blind exclusion.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

The alert arrives after widespread encryption

Cause: a long window, slow telemetry pipeline, or a sample whose malicious behavior begins late. Fix: measure time to alert, use shorter secondary rules for high-risk actions, and test staged response so early low-confidence signals can trigger investigation without immediately stopping every workload.

A new sample bypasses the classifier

Cause: feature evasion, distribution shift, or training data that lacked the relevant family and execution style. Fix: add adversarial and late-starting samples, monitor drift, retrain with newly labeled events, and retain independent holdout tests.

Analysts cannot decide whether an alert is real

Cause: the score is presented without evidence. Fix: include process lineage, user, host role, paths, operation counts, entropy changes, first-seen time, and correlated network or authentication events. An explanation is operationally more useful than a probability alone.

Attackers disable or starve telemetry

Cause: endpoint agents, logs, or network visibility are not protected and monitored. Fix: centralize and retain logs, alert on sensor health changes, restrict administrative control, and maintain an independent response path for isolating a host.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

A decision checklist before deployment

  • Are the collected events sufficient to reconstruct process-to-file behavior?
  • Have normal workloads been labeled by host role, schedule, and user population?
  • Are false positives, false negatives, and time to alert reported together?
  • Were late-starting, partial-encryption, throttled, and benign-event-insertion cases tested?
  • Can an analyst see why the model scored an activity as suspicious?
  • Is there a documented escalation from alert to isolation and recovery?
  • Are logs retained centrally and protected from endpoint tampering?
  • Can the organization restore clean data and verify that the original access path is closed?

Bottom line

Machine learning improves ransomware detection when it adds context to endpoint behavior: file I/O bursts, process relationships, temporal sequences, path use, and carefully interpreted entropy changes. The evidence does not support a universal accuracy rate or a single best algorithm. Treat every model as one layer in a program that combines signatures, allowlisting, real-time monitoring, centralized logs, network baselines, human investigation, containment, and tested recovery. Validate on your own workloads, measure false alarms and missed attacks, and test how an adaptive adversary can change the signals before allowing automation to interrupt production systems.
