To compare images with a Siamese network, train one shared embedding model on triplets: an anchor image, a related positive image, and a contrasting negative image. Triplet loss pushes the anchor’s embedding closer to the positive than to the negative by at least a chosen margin. After training, embed new images and compare their vectors. The result is a distance or similarity score—not, by itself, a probability that two images match.
What image relationship should the model learn?
Decide what “similar” means for your application before preparing data. It could mean the same object photographed from different angles, the same product, a near-duplicate image, or another relationship. The anchor and positive must represent that relationship; the negative should be a meaningful contrast. If those labels do not reflect the intended task, training can successfully optimize the wrong notion of similarity.
This embedding approach is also used in face recognition: FaceNet describes mapping face images into a Euclidean space where distance represents similarity. The same broad idea can be applied to other image domains, but the data and definition of a positive match must fit the application. FaceNet: A Unified Embedding for Face Recognition and Clustering.

How triplet loss trains image embeddings
Let f be the shared embedding network, and let A, P, and N stand for anchor, positive, and negative images. The Keras example uses squared Euclidean distances and the following hinge-style loss:

The loss compares the anchor-positive distance with the anchor-negative distance. When the negative is already farther from the anchor than the positive by at least the margin, the loss for that triplet is zero. Otherwise, the loss penalizes the model; training updates the embedding network to improve the relationship. The margin and squared-distance convention are design choices that need validation for your data, not universal defaults. The Keras Siamese-network example uses a default margin of 0.5.

Prepare triplets and consistent image inputs
Each training item contains three images: (anchor, positive, negative). A triplet is useful only if its labels encode the visual relationship you want the model to learn. Sampling matters too: easy negatives may teach little, while misleading negatives can conflict with the task’s labels. The Keras example prepares filename-based triplets from the Totally Looks Like dataset; that particular dataset and sampling scheme are examples, not requirements.

In its input pipeline, the example reads JPEG files, decodes them as three-channel images, converts them to floating point, resizes them to 200 × 200 pixels, and batches triplets using tf.data. Choose image decoding, size, normalization, and batching to suit your own data, and apply compatible preprocessing consistently to all three inputs and to images used later for comparison.

Build one embedding model and share it across inputs
A Siamese architecture uses the same embedding model for every member of a triplet. The anchor, positive, and negative therefore pass through one shared set of weights rather than three independently learned networks. Once trained, that same embedding function can process images individually.
The Keras worked example starts with ImageNet-pretrained ResNet50 without its classification head. It flattens the feature output, adds dense layers and batch normalization, and produces a 256-dimensional embedding. It freezes earlier ResNet layers and fine-tunes later ones. These are example configuration choices—not evidence that this backbone, embedding size, or freeze boundary is best for another dataset.

Train the custom triplet objective in Keras
The example wraps the Siamese network in a custom Keras Model and overrides train_step and test_step. It uses tf.GradientTape to calculate gradients, applies them with the configured optimizer, and tracks mean loss as a metric. This pattern lets training consume three inputs and optimize the triplet objective directly.
The tutorial was created and last modified on 2021-03-25. Because Keras and TensorFlow APIs and serialization behavior can vary by version, check the example against the versions in your project before copying its code unchanged. Consult the Keras example for the complete worked implementation.

Compare embeddings for similarity or retrieval
At inference, run each image through the trained embedding network, then compare the resulting vectors using a chosen measure. The Keras example demonstrates cosine similarity. Its training objective, however, uses squared Euclidean distance. These are distinct comparison conventions: squared Euclidean distance gets smaller as vectors get closer, while cosine similarity generally gets larger as their directions align. Select the measure that fits how the system will be used and evaluate that same measure downstream.
A score is not automatically a calibrated match probability. The example prints illustrative cosine-similarity values for sample embeddings; they are not a benchmark, expected performance, or a generally valid cutoff. For a match/no-match system, choose a threshold using held-out data from the intended application. For image search, assess retrieval with measures appropriate to the retrieval task.
Decisions to validate on your dataset
- Triplet quality: Check that positive and negative labels encode the relationship users care about.
- Sampling or mining: Assess whether the triplets provide useful, representative contrasts.
- Embedding architecture: Compare candidate backbones, including whether pretraining helps your data.
- Training setup: Validate distance convention, margin, and which backbone layers are frozen or trainable.
- Evaluation: Use held-out examples and a measure aligned with the real use—retrieval or match verification.
The cited sources do not establish a current controlled comparison that identifies a universally best choice for these decisions. The Keras page is a worked example, not a comparative benchmark.
