Physics-informed AI can make repeated chip-simulation runs dramatically faster by acting as a surrogate for an established TCAD, SPICE, finite-element or lithography solver. The practical pattern is not to discard the trusted solver: generate representative high-fidelity cases, train a model that respects the relevant physics, validate it on unseen conditions, use it for broad design-space exploration, and send finalist designs back through the conventional simulator for calibration and signoff.
Depending on the workload and hardware, published industry results range from a 12× S-Device benchmark improvement to claims of more than 100× faster thermal-surrogate evaluations. NVIDIA has also described semiconductor surrogate workflows that reduce individual evaluations from hours to milliseconds. These are benchmark-specific or projected results, not guarantees for every process node, geometry or operating corner.
What physics-informed AI means in chip design
Physics-informed AI combines a machine-learning model with the structure of a physical problem. That structure may include governing equations, geometry, material properties, boundary conditions, conservation laws, symmetry, dimensional relationships or data generated by a trusted simulator.
In a conventional workflow, an engineer changes a geometry, material, process parameter or operating condition and waits for a high-fidelity solver to converge. A trained surrogate learns the mapping from those inputs to outputs such as temperature, stress, electric potential, current, field distribution, delay or lithography quality. Inference is usually much cheaper than solving the full equations again, so the model can evaluate thousands or millions of candidates during exploration.

The surrogate is useful only inside a validated domain. It approximates the solver; it does not automatically discover whether the underlying process model, mesh, boundary condition or compact model is correct. For that reason, the conventional simulator remains the reference for calibration, corner checking and signoff.
Why a surrogate can be faster than TCAD, SPICE or finite-element simulation
A numerical solver repeatedly assembles and solves large systems of equations, often with nonlinear iterations, adaptive meshing, matrix factorization and convergence checks. A neural surrogate performs a fixed sequence of tensor or graph operations after training. On suitable GPUs, those operations can be highly parallel and can reuse learned representations across nearby design points.
The expensive work moves to an offline stage:
- Data generation: run the trusted solver over a carefully selected range of geometries, materials, process corners and boundary conditions.
- Training: fit a model to fields, waveforms, scalar metrics or complete solver responses.
- Validation: compare predictions with held-out solver cases, including cases that stress the edges of the intended operating window.
- Inference: evaluate new candidates rapidly, usually in batches.
This trade-off pays off when the same class of simulation is run many times. If a design is simulated only once, the cost of generating data and training may exceed any benefit.
The Tool Desk
Outbyte PC Repair FREEClear out junk files and repair common Windows errorsFree Scan →Outbyte Driver Updater FREEScan for outdated or missing drivers - takes under a minuteDriver Scan →Can physics-informed AI replace a SPICE or TCAD solver?
For production signoff, assume no. A surrogate can replace repeated exploratory evaluations only after its accuracy, stability and coverage have been demonstrated for the target process window. It should not be treated as a universal substitute for SPICE, TCAD, finite-element, computational-lithography or other certified solvers.
A safe division of labor is:
- Surrogate: rank options, sweep parameters, propose candidates, optimize layouts and identify sensitive regions.
- Trusted solver: establish reference behavior, validate finalists, check corners and produce signoff results.
- Human review: investigate outliers, extrapolation, physical violations and model drift after process or tool changes.
Neural models can fail silently when they encounter a geometry or process condition unlike the training set. A low training loss is not evidence that an unseen mask pattern, device structure or thermal boundary condition is safe. Keep a solver-in-the-loop verification gate.
Choose the model class for the simulation structure
Model selection should follow the shape of the design data rather than the popularity of an architecture. The following choices are common starting points.

| Graph neural network | Changing connectivity, layouts, meshes or device graphs | Can represent variable-size structures and relationships between neighboring elements | Accuracy can degrade on graph topologies or feature ranges absent from training |
| Neural operator | Field problems such as temperature, potential, stress or fluid-like distributions | Learns mappings between functions or fields rather than one fixed output vector | Boundary-condition and resolution changes may require careful encoding and retraining |
| Physics-informed neural network | Problems where governing equations and boundary conditions can be evaluated during training | Can penalize residuals and physical violations even when labeled data are limited | Loss balancing and stiff or multi-scale equations can make optimization difficult |
| Data-driven emulator with physics features | Repeated scalar metrics or waveforms from a stable design family | Often simpler to train and deploy when abundant simulator data exist | May fit accurately while violating conservation or behaving poorly outside the sampled range |
Physics-inspired lithography is particularly data-constrained and physics-heavy. Neural architectures can assist mask optimization and lithography modeling, but they should remain auxiliary accelerators until they are validated for the exact process window and pattern distribution.

-
Select one expensive, repeated loop
Start with a narrow task that has a measurable payoff, such as a thermal sweep, TCAD parameter exploration, lithography optimization or a repeated multiphysics solve. Define the inputs, outputs, acceptable error and the number of evaluations performed per project.
-
Define the operating envelope
List geometry ranges, materials, layer stacks, voltage and temperature ranges, process corners, frequencies, boundary conditions and solver settings. The model should be trained for the envelope in which it will be used, not for an undefined notion of generality.
-
Generate representative high-fidelity data
Use the established solver to produce data across nominal and corner conditions. Include nonuniform sampling near sharp transitions, resonances, pinch-off, thermal runaway, lithographic hotspots or other regions where outputs change rapidly. Record metadata such as mesh or resolution, units, solver tolerances and version.
-
Choose outputs and representation
Decide whether the model predicts scalar figures of merit, waveforms, images, full fields or a reduced-order representation. Normalize units explicitly and preserve coordinate systems, masks, node identities and boundary labels needed to interpret the result.

Re-run finalists through the conventional simulator
Use the high-fidelity tool for final corners, signoff reports and any candidate outside the validated domain. Feed important discrepancies back into an active-learning loop so that the surrogate improves where it is actually being used.
How to build useful training data
More data are not automatically better. A narrow, biased data set can produce a model that is extremely accurate on common nominal cases and unreliable on the rare cases that determine yield or reliability.
Cover the variables that change physics
- Device dimensions, layout topology and layer thicknesses
- Material parameters, doping or composition ranges
- Temperature, voltage, frequency and power conditions
- Process corners, tolerances and manufacturing variation
- Thermal, electrical, mechanical and interface boundary conditions
- Mesh, resolution and solver-version metadata when outputs depend on them
Use adaptive sampling
Begin with a space-filling design, then add points where the surrogate has high uncertainty, large validation error or rapidly changing gradients. This active-learning strategy can reduce the number of expensive solver runs compared with uniform sampling.

Keep units and dimensional relationships explicit
Mixing nanometers, micrometers, kelvin and degrees Celsius, or amperes and milliamperes, can create plausible-looking but physically wrong predictions. Store units in the data contract, normalize consistently and run dimensional checks before training and inference.

Where physics-informed AI is already being applied
| Workflow | Reported result | Qualification |
|---|---|---|
| TCAD device simulation with S-Device | 12× speedup | Synopsys describes a published benchmark on NVIDIA B200 GPUs versus comparable CPU infrastructure; the figure is workload- and hardware-specific. |
| Thermal simulation with PhysicsNeMo and SeaScape | More than 100× faster | Synopsys reports this for surrogate models trained on high-fidelity data; it is not a universal thermal-solver result. |
| PrimeSim circuit simulation | Up to 30× projected improvement | Synopsys projects this on NVIDIA GB200 Grace Blackwell; earlier GH200 results were reported at up to 15×. |
| Proteus computational lithography | Up to 20× projected improvement | Synopsys projects this on NVIDIA B200 hardware. |
| QuantumATK materials workflows | 6–10× development-time improvement | Synopsys cites this as a development-time improvement in one materials-discovery use case, not a guaranteed per-simulation speedup. |
| Semiconductor surrogate inference | Hours to milliseconds | NVIDIA describes this range for suitable AI surrogate workloads built with PhysicsNeMo; the baseline, model and workload determine the actual result. |
These figures should always be quoted with the hardware, baseline, workload and whether the number is measured, benchmarked or projected. A speedup in batched inference does not imply the same speedup for data generation, training, preprocessing or end-to-end project time.
Thermal, multiphysics and packaging applications
Advanced packaging creates repeated electro-thermal, mechanical, stress and reliability calculations across many materials and geometries. NVIDIA identifies workflows involving Cadence, COMSOL and Voltai for these kinds of accelerated semiconductor and multiphysics tasks. A surrogate can screen package structures, identify hotspots and prioritize detailed solves before tape-out or qualification.
For coupled problems, predict each field jointly only when the training data support that relationship. Otherwise, a staged design can be safer: one model estimates a thermal field, another evaluates stress conditioned on temperature, and selected cases are checked with the coupled high-fidelity solver. Conservation and interface continuity should be tested at every coupling boundary.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Hardware and software integration
NVIDIA provides PhysicsNeMo, CUDA-X libraries and GPU platforms for building and serving physics-aware models. Synopsys integrates accelerated compute and AI-physics capabilities into PrimeSim, Sentaurus, QuantumATK and SeaScape. Industry overviews also identify Cadence and COMSOL, while Voltai and ChipAgents represent specialist efforts focused on agentic multiphysics and chip-design AI.
Integration does not remove engineering work. Plan for data conversion, mesh or layout serialization, feature normalization, accelerator memory, batch scheduling, model versioning, regression tests and a route back to the original solver. Keep the same parameter and unit definitions in both paths so that discrepancies are attributable to the model rather than to preprocessing.

How to evaluate a candidate surrogate
| Criterion | Questions to answer |
|---|---|
| Physical fidelity | Does the model enforce or accurately reproduce governing equations, interfaces, conservation and boundary conditions? |
| Unseen-geometry accuracy | How does it perform on complete layouts, meshes or device structures never used during training? |
| Process-window coverage | Are all relevant corners, materials, temperatures, voltages and manufacturing variations represented? |
| Inference speed | What is latency and throughput on the intended hardware, including preprocessing and postprocessing? |
| Training cost | How many high-fidelity solver runs, GPU hours and storage are required before the model is useful? |
| Uncertainty quality | Does low confidence reliably identify large errors or out-of-distribution inputs? |
| EDA integration | Can the model consume native design data and return results in the formats existing tools use? |
| Maintenance | When must it be retrained after a process, model, solver, library or hardware change? |
| Signoff boundary | Which decisions still require the conventional simulator and documented approval? |
Common failure modes and recovery steps
Excellent average error but unsafe worst cases
Mean error can hide a small number of catastrophic failures. Add worst-case, percentile and corner-specific metrics; oversample sharp transitions; and require solver confirmation for high-impact decisions.
Predictions violate conservation or boundary conditions
Add residual and interface penalties, encode boundary conditions directly where possible, and reject outputs that fail post-inference physical checks. If constraints make training unstable, train in stages and monitor each loss term rather than allowing one term to dominate.
Accuracy collapses on a new geometry
Check whether the representation can express the new topology. A fixed-size vector model may be unsuitable for changing connectivity; use a graph representation or retrain with representative geometries. Do not extrapolate silently.
Recommended Free Tools
Training data are too expensive
Reduce output dimensionality with a validated reduced-order representation, use adaptive sampling and prioritize the variables that drive the design decision. A smaller, targeted model is preferable to a broad model with insufficient coverage.
Speedup disappears in the full workflow
Measure data loading, feature construction, batching, device transfer and postprocessing in addition to raw inference. If only a tiny fraction of runtime is spent in the solver loop, a surrogate cannot deliver a large end-to-end gain.
Results drift after a tool or process update
Treat solver versions, compact models, material databases and process definitions as part of the model identity. Re-run a fixed regression suite after each change and retrain when the reference behavior moves beyond validated error limits.
When this approach is worth adopting
- Choose it when the same expensive simulation is evaluated many times and the input domain can be defined.
- Prefer a pilot with clear acceptance thresholds, a held-out test set and an explicit solver fallback.
- Delay deployment when the process window is changing rapidly, the data set is sparse in critical regions or signoff requires guarantees the model cannot provide.
- Judge success by end-to-end engineering throughput and decision quality, not by inference latency alone.
The strongest defensible use of physics-informed AI in chip design is acceleration: preserve the physics-based solver as the authority, use AI to explore more candidates, and make every high-stakes conclusion traceable to a validated simulation.
