Reduce memory power by moving less data, moving it shorter distances, and moving it less often. In practice, that means quantizing weights and activations, using a smaller or distilled model, bounding the context and key-value (KV) cache, reusing buffers in on-chip SRAM or accelerator cache, and measuring energy on the actual robot. If a network link is reliable and its round-trip delay is acceptable, keep safety-critical control onboard and offload heavy perception, mapping, planning, or generative inference. Memory technology, board layout, and processing-in-memory can produce larger gains, but those are hardware-design decisions rather than universal upgrades.
Why memory can determine an AI robot’s battery life
Inference is often limited by data movement
A neural-network layer may require thousands of arithmetic operations for every value fetched from external DRAM. When the processor waits for weights, activations, or KV-cache entries, the energy spent moving those values can exceed the energy spent multiplying them. This is why a faster accelerator does not automatically reduce battery drain: a larger accelerator can increase the amount of data fetched per second and the power needed to keep the memory interface active.
Google Research’s 2026 VLA evaluation characterizes autoregressive action generation as strictly memory-bound. In that evaluation, standard memory technologies could not meet a 10 Hz real-time safety target for models larger than 13 billion parameters. The threshold applies to the models and hardware tested, not to every robot, but it is a useful warning: once a control model is large enough, memory bandwidth and latency become the limiting resources.
Power is workload- and platform-specific
Do not assume that a fixed percentage of robot power belongs to DRAM. A 2026 Raspberry Pi 5 edge-LLM artifact measured DRAM-rail power at 4% to 5% of total system power in its particular setup. That result includes one board, one memory package, one model workload, and one duty cycle; it is not a universal memory-power budget. A robot with high sensor traffic, a different SoC, or a discrete GPU can have a very different split.

Measure total battery current as well as memory-rail current. The useful outcome is lower joules per completed task or per control cycle, not merely a lower reading from one rail while the processor takes longer to finish.
Establish a baseline on the target robot
Make one repeatable measurement before changing a model, board, or memory package. Use the robot’s real sensor rates, control loop, environmental conditions, and mission duration. Synthetic benchmarks often hide copies, thermal throttling, network retries, and idle periods that dominate field operation.
- Record the workload. Identify every model, its parameter count and precision, input dimensions, image or point-cloud rate, prompt or context length, generated-token limit, and KV-cache policy.
- Record timing. Measure average and worst-case inference latency, jitter, end-to-end sensor-to-action latency, and the deadline for the safety or motion-control loop. For a 10 Hz loop, the complete cycle has 100 milliseconds, including sensing, planning, actuation, and safety checks.
- Record memory behavior. Capture peak and steady-state capacity, external-memory bandwidth, cache hit rates when available, CPU-to-GPU or accelerator copies, allocation frequency, and memory temperature.
- Record energy. Log battery voltage and current, board and accelerator power, memory-rail power if exposed, energy per inference or token, and energy per completed mission segment. Repeat at cold start and after the system reaches its normal temperature.
- Record task quality. Use the robot’s safety and task-success tests, not only perplexity or a classification score. Include missed detections, unsafe actions, recovery behavior, and degraded-mode performance.
- Save a trace. Keep timestamps for sensor arrival, preprocessing, transfers, inference, postprocessing, actuator commands, and network requests. This identifies whether memory is busy because of the model or because the software is repeatedly copying data.
Use a consistent energy calculation: integrate battery power over the same mission segment, then divide by successful tasks, control cycles, or generated tokens. A change that lowers watts but doubles execution time may increase total energy.

Quantize weights and activations
Quantization stores numerical values with fewer bits. INT8 commonly halves the storage of a 16-bit representation, while INT4 can reduce it further, although metadata, scales, and unsupported operators add overhead. The important power mechanism is not only smaller model capacity: fewer bytes must travel between DRAM, cache, and the accelerator for each layer.
Test the formats that the robot’s accelerator executes natively. Compare FP16 or BF16, INT8, INT4, and any mixed-precision mode supported by the runtime. Some devices dequantize values into a wider format before computation; in that case, capacity savings may not translate directly into bandwidth or energy savings.

Quantize a representative calibration set, then run the robot’s acceptance tests. Check small objects, unusual lighting, reflective surfaces, motion blur, speech accents, and recovery from sensor dropouts. For a controller, one rare unsafe action matters more than a small average-score improvement. Keep a higher-precision fallback for operations that are sensitive to accumulated error, such as coordinate transforms or final safety checks.
Use distillation, pruning, or a smaller model
A distilled model learns to reproduce the useful behavior of a larger teacher with fewer parameters. Structured pruning can remove channels or attention heads in a way the accelerator can skip; unstructured sparsity may save storage but provide little benefit if the runtime still reads dense tensors. Select the smallest model that passes task-success and safety tests at the required sensor rate.
Reduce input size where the task permits. A lower camera resolution, fewer point-cloud samples, or a region-of-interest detector can reduce both activation memory and downstream bandwidth. Preserve a full-resolution path for events that need it, such as a near-field obstacle or a safety inspection.
Bound context and KV-cache growth
Autoregressive models retain keys and values for prior tokens. Cache size grows with context length, layer count, hidden width, and batch size, so an unlimited conversation or planning history can become a hidden memory-power cost. Set an explicit maximum history, summarize old state, evict irrelevant observations, and cap generated tokens. Use a sliding window for routine operation and a separate, bounded memory for mission facts.
Measure the cache at the longest permitted context, not only at the average. If the runtime supports lower-precision KV storage, validate it separately from weight quantization: cache errors can affect long-horizon planning even when single-step perception remains accurate.

Keep frequently reused data close to the compute
Reuse SRAM and accelerator cache
On-chip SRAM and cache usually consume less energy per access than external DRAM, but capacity is limited. Place hot weights, recurrent state, calibration tables, and the most frequently reused activations in the fastest memory. Tile convolutions or matrix operations so a block is loaded once and reused for as many operations as possible before eviction.
Profile the working set rather than filling SRAM indiscriminately. A large tensor that is read once can displace a small tensor read hundreds of times. Reserve predictable space for control state and safety logic so a perception burst cannot evict data needed by the control loop.
Eliminate avoidable copies
Use shared buffers or zero-copy interfaces where the operating system and accelerator permit them. A camera frame should be converted, cropped, and normalized in place or in a reusable pool instead of being copied through separate CPU, GPU, and accelerator allocations. Reuse tensor buffers between frames, preallocate the largest bounded tensors, and align layouts with the accelerator so a format conversion is not inserted before every kernel.
Inspect the execution graph for hidden transfers. Common causes include a CPU-only operator between accelerator layers, a tensor-layout mismatch, a framework fallback for an unsupported quantized kernel, and an image library that silently creates a new buffer. Replacing one unsupported operation can save more energy than changing the model’s nominal precision.
Schedule sensor processing for locality
Fuse operations that consume the same frame, such as resize, color conversion, normalization, and region selection. Process a sensor stream in tiles when the full frame does not need to be resident. Keep calibration and coordinate-transform data in cache, and pass references to immutable sensor data instead of serializing and deserializing it between processes.

Use dynamic power management without breaking the control loop
Lower frequency and voltage during slack
Dynamic voltage and frequency scaling can reduce memory and accelerator power when the robot has spare time before the next deadline. Apply it to periods such as a stable scene, a low sensor rate, or post-inference idle time. The controller should raise performance before a known burst, not after the deadline has already been missed.
Characterize wake-up and ramp latency. A low-power state that takes longer to exit than the available control slack can increase worst-case latency and cause a safety violation. Keep emergency-stop monitoring, watchdogs, and the minimum actuator path at a frequency that is independent of an energy-saving profile.
Power-gate unused blocks
Disable an unused vision engine, radio, memory channel, or accelerator partition when the platform supports power gating. Account for state-save and restore traffic: repeatedly powering a block down for very short gaps can consume more energy than leaving it idle. Use mission-level scheduling to create long, predictable off intervals.
Offload heavy inference selectively
What to keep onboard
Emergency stopping, collision intervention, joint or motor control, watchdogs, localization needed for immediate stability, and a degraded-mode behavior should remain local. The robot must be able to stop safely when the link is unavailable, congested, or delayed. A remote service can advise a local planner, but it should not be the only path to a safe action.

Battery benefit versus latency and bandwidth
Microsoft Research’s September 23, 2026 report notes that onboard GPUs consume substantial power, cost weight and space, and limit which models can run. In its Stretch-3 comparison, larger onboard GPUs could drain batteries by up to 160% relative to the lighter configuration that offloaded work. This is a result for that robot and comparison, not a guaranteed saving for every platform.
Offloading is not free. A March 2026 Microsoft Research measurement study found that network latency can reduce task accuracy and that naive cloud offloading may require impractical bandwidth. Round-trip delay also adds jitter: a single late response can be more damaging to a robot than a slightly slower but predictable local model.
Measure four operating modes: local only, remote only, local with remote enhancement, and disconnected degraded mode. For each, record task success, p50 and worst-case latency, packet loss behavior, energy per task, radio power, and battery operating time. Choose offload only when the remote mode meets the robot’s deadline and the local fallback remains safe.

Consider memory architecture when designing a new board
LPDDR and larger on-chip caches
For a new board, compare LPDDR-class memory, channel count, package placement, cache capacity, and accelerator location as one system. A memory package with higher peak bandwidth may use more energy if the workload cannot sustain that bandwidth efficiently. Shorter traces, fewer channels activated per transaction, and a cache sized for the model’s hot working set can matter more than a headline bandwidth number.
Processing near memory and processing in memory
Processing-near-memory (PNM) and processing-in-memory (PIM) move selected operations closer to where data is stored, reducing transfers across a conventional memory interface. A 2025 3D-stacked DRAM PNM paper by Qiang Zhou, Bing Wang, and XinTing Xiao reports 3x to 9x lower power at similar performance for its evaluated architecture. The result depends on its stack, workload, and implementation; it is not a drop-in upgrade for an existing robot.
Google Research’s 2026 VLA work reports a 140x speedup for its evaluated PIM configuration on a 100-billion-parameter model, reducing reported latency from 83 seconds to 2.8 seconds. That dramatic result demonstrates the value of reducing data movement for a particular design. It does not mean a 140x gain is available by installing a different memory module, because PIM requires compatible silicon, software, compiler support, and model operators.
Evaluate a board with a workload trace
Before selecting a memory package or custom ASIC, replay traces that include sensor bursts, model switching, cache warm-up, context growth, and network interruptions. Compare energy per inference, capacity, bandwidth, worst-case latency and jitter, accuracy, thermal headroom, software maturity, upgradeability, and the safety fallback. Peak TOPS and peak memory bandwidth are insufficient selection criteria.

Troubleshoot common failures
Quantization lowers accuracy more than expected
- Check whether calibration data covers the robot’s real lighting, surfaces, poses, and sensor noise.
- Keep sensitive layers, normalization, coordinates, or safety classifiers at higher precision.
- Verify that the runtime is using the intended low-bit kernels rather than silently converting tensors.
- Compare task-success and unsafe-action rates, not only an aggregate benchmark score.
Power falls but mission energy rises
- Measure joules per task and total mission time; a slower model can erase a watt-level saving.
- Look for thermal throttling after the change, which can lengthen every subsequent inference.
- Include radio, camera, storage, and cooling power when evaluating offload or a new memory mode.
Latency becomes unpredictable
- Inspect page faults, allocator growth, garbage collection, cache misses, and CPU-accelerator synchronization.
- Measure worst-case latency under simultaneous sensor bursts, not only an idle benchmark.
- For remote inference, log round-trip time, retransmissions, queueing, and link handoffs.
Offload fails during disconnection
- Set a strict timeout and return to a locally validated model or stop behavior.
- Cache the last safe map, plan, or perception result only for a bounded interval; stale data must not authorize unsafe motion.
- Test loss of connectivity, low bandwidth, packet corruption, and remote-service overload as explicit mission cases.
A practical implementation order
- Baseline the complete workload and energy on the production robot.
- Quantize weights and activations in the formats the target accelerator supports, then run safety and task tests.
- Reduce model size, input resolution, context length, and KV-cache history one change at a time.
- Remove copies, reuse buffers, fuse preprocessing, and keep hot data in SRAM or cache.
- Add DVFS or power gating only after measuring wake-up latency against the control deadline.
- Prototype offload for non-critical stages and compare local, remote, hybrid, and disconnected modes.
- If designing hardware, evaluate LPDDR, cache, accelerator placement, PNM, and PIM with recorded workload traces rather than peak specifications.
The winning configuration is the one that meets the robot’s safety deadline and task-quality requirement with the lowest measured energy per successful operation. Memory capacity, bandwidth, locality, compute, thermal behavior, and network dependence must be optimized together; changing only the memory component rarely solves the whole power problem.
