You can cut GPU cloud spending without slowing an AI service by improving the amount of useful work each GPU completes, not by blindly choosing a smaller accelerator. Start with a workload baseline, then test right-sized hardware and lower precision, increase utilization with caching and batching, autoscale on queue or batch signals, shut down idle replicas, and use discounted capacity only where interruptions are safe. Keep latency, quality, and error-budget limits as release gates for every change.
There is no universal cost-per-token or cost-per-request figure: the right design depends on prompt and response lengths, concurrency, model precision, traffic shape, regional prices, and your service-level objectives (SLOs). The playbook below shows how to find the lowest-cost configuration that still meets your measured throughput, time-to-first-token (TTFT), and end-to-end latency targets.
1. Establish a cost and performance baseline before changing capacity
Do not begin by moving to a cheaper GPU or enabling Spot capacity. First capture several weeks of representative traffic, including quiet periods and peaks. A model that appears underutilized on average may be saturated during the hours that determine your SLO, while a high average utilization can conceal poor batching or excessive queueing.
What’s actually slowing this PC down?
Pick the symptom - the matching free tool is one click away.
Record the measurements that explain both spend and user experience
- GPU duty cycle: the share of time the accelerator is doing work rather than waiting.
- GPU memory use and headroom: include model weights, key-value cache, framework overhead, and the highest observed request.
- Queue depth and age: track both the number of waiting requests and how long the oldest request has waited.
- Batch size and concurrency: record actual values, not only configured maxima.
- Tokens per request: separate prompt tokens from generated tokens; both affect compute and memory.
- Throughput: tokens per second, requests per second, and completed work per replica.
- Latency: time to first token plus end-to-end p50 and p95 (and p99 if your SLO uses it).
- Error rate and timeouts: include rejected, retried, and cancelled requests.
- Interruption and restart behavior: measure model-load time, checkpoint recovery, and lost work.
- Spend attribution: tag costs by team, model, environment, and tenant so an optimization can be verified after deployment.
AWS notes that two deployments serving the same model can require different infrastructure because prompt length, response length, concurrency, and latency objectives differ. Treat your traffic profile and SLO as part of the hardware specification, not as details to optimize later.

Use a cost-per-useful-work view, not a single utilization target
Calculate the cost of a completed request or generated token for each workload segment, but do not assume the resulting number transfers to another provider, region, model, or precision. No authoritative figure establishes a universal cost-per-token, cost-per-request, or average GPU-utilization benchmark across cloud providers. Your baseline should instead show how each configuration performs under the same evaluation set and traffic replay.
2. Right-size the accelerator and precision
Select an accelerator from the model’s actual memory and compute requirements. The minimum viable GPU must fit weights, runtime overhead, the largest key-value cache, and concurrency headroom while sustaining your latency target. A GPU with more memory than the workload needs can be more expensive without improving throughput.
Evaluate the variables that determine GPU size
- Model size and architecture: parameter count, attention implementation, and any auxiliary models determine baseline memory and compute.
- Numeric precision: lower precision generally reduces memory requirements and can improve throughput, but hardware and kernel support vary.
- Prompt and response lengths: long contexts increase memory pressure and decode time.
- Concurrency and batching: simultaneous sequences need additional cache and scheduler capacity.
- SLOs: a configuration that is adequate for batch throughput may miss an interactive TTFT or p95 target.
AWS identifies FP16, FP8, INT4, and NVFP4 as common inference formats. Test each format that your model and serving stack support against a fixed quality evaluation set, a fixed traffic mix, and an explicit latency budget. Lower precision is a measured trade-off, not an automatic win: a small quality regression may be unacceptable for a regulated or customer-facing task, while it may be harmless for classification or retrieval.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Clear out junk files and repair common Windows errors3Fix the driver behind crashes, sound loss and screen glitchesRun a controlled right-sizing test
- Freeze the model version, tokenizer, serving engine, prompt mix, and evaluation set.
- Choose a latency budget for TTFT and end-to-end p95, plus a minimum throughput requirement.
- Test lower-cost GPU families and the supported precision formats one at a time.
- Record memory headroom at the largest context and target concurrency; leave room for allocator fragmentation and traffic bursts.
- Compare quality, throughput per dollar, p50/p95 latency, startup time, and regional availability.
- Canary the best candidate before changing every replica, with an immediate rollback to the previous image and accelerator.
Do not infer that a newer or smaller GPU is cheaper in practice from hourly price alone. If it processes fewer tokens per second, requires more replicas, or has limited regional capacity, the total bill can rise.
3. Increase useful work per GPU before buying more GPUs
Once the hardware fits, improve utilization by removing duplicate work and filling idle scheduling gaps. Microsoft lists caching, batching, routing, model selection, GPU right-sizing, scale-to-zero, reservations, quantization, and per-tenant controls as complementary cost levers.

Use prompt and semantic caching where answers can be reused
Exact prompt caching avoids recomputing identical prefixes. Semantic caching can reuse an answer for sufficiently similar questions, but it needs an application-specific similarity threshold, freshness policy, and a safe fallback when confidence is low. Measure cache hit rate, avoided GPU time, stale-answer incidents, and the extra latency of cache lookup. Never trade correctness or authorization boundaries for a higher hit rate.
Batch requests without violating latency budgets
Dynamic batching combines requests arriving within a short scheduling window. Larger batches often improve throughput, but waiting to form a batch can increase TTFT and p95 latency. Set a maximum wait and maximum batch size from measurements, then monitor queue age as well as GPU utilization. Streaming responses may require a different policy from offline generation because users feel the first-token delay immediately.
Route each request to the least expensive model that meets its quality need
Use a cheaper default model for routine requests and route complex, ambiguous, or high-risk cases to a larger model. Define routing rules with an offline evaluation set and monitor escalation rate, quality metrics, and tenant-level outcomes. A router that sends most traffic to the expensive model adds complexity without saving money.
Control noisy-neighbor and tenant behavior
Apply per-tenant concurrency limits, token budgets, and priority classes. These controls prevent one tenant’s long-context burst from forcing every replica to scale out. Expose a clear response when a limit is reached—queue, shed, or downgrade according to the product’s SLO—rather than allowing unbounded retries that multiply GPU work.
4. Share a physical GPU safely with MIG
NVIDIA Multi-Instance GPU (MIG) partitions a supported physical GPU into isolated instances that run workloads in parallel. NVIDIA documents up to seven GPU instances on supported Blackwell and Hopper configurations. This can raise utilization for small inference services, development environments, or mixed workloads that would otherwise leave a full accelerator idle.

When MIG is a good fit
- The model and runtime fit comfortably within a slice’s memory.
- Workloads have predictable resource limits and do not need the whole GPU for short bursts.
- Isolation between tenants or services is more important than sharing a single memory pool dynamically.
- You can schedule enough independent work to keep the physical GPU busy.
Validate the partition, not just the advertised profile
Benchmark the actual model on the chosen MIG profile. Check memory headroom, kernel compatibility, batching behavior, TTFT, p95 latency, startup time, and failure recovery. Confirm that the isolation model meets your security and compliance requirements. A slice that looks inexpensive can be a poor choice if it forces more replicas, prevents efficient batching, or lacks capacity in your required region.
5. Autoscale on signals that represent pending AI work
Autoscaling should respond to demand before users experience a violation, while avoiding replicas that sit idle after a burst. GPU utilization is useful for diagnosing saturation, but it does not measure how much useful work is completed while the GPU is active. CPU-only signals are insufficient for GPU inference because a service can have idle CPUs and a saturated accelerator, or busy CPUs while the GPU waits.
Choose queue-size autoscaling for throughput and cost
Google recommends queue-size autoscaling when the goal is to maximize throughput and minimize cost and the latency target can be achieved with the model server’s maximum batch size. Scale out as queued work or queue age crosses a tested threshold; scale in only after the queue has remained low for a stabilization period. Use queue age when a few very long requests matter more than the raw count.
Choose batch-size autoscaling for tighter latency targets
Google recommends batch-size autoscaling when latency targets are tighter. Scale from the observed batch size and its relationship to TTFT and p95, rather than waiting for GPU utilization to reach a fixed percentage. Keep a minimum replica count when loading weights or initializing kernels would otherwise violate the SLO.
Build an autoscaling policy with explicit guardrails
- Define the SLO signals: TTFT, end-to-end p95, queue age, throughput, and error rate.
- Choose queue size or batch size as the primary scaling signal; retain GPU memory and utilization as safety diagnostics.
- Set scale-out and scale-in stabilization windows from measured startup and drain times.
- Cap maximum replicas by quota, budget, and downstream rate limits.
- Test burst, steady-state, and traffic-drop scenarios with a canary service.
- Alert when scaling reaches the cap, queue age rises despite added replicas, or errors increase after scale-out.
6. Turn idle GPUs off without creating cold-start surprises
Bursty endpoints often save more through scale-to-zero or an aggressive minimum-replica policy than through a small hourly price reduction. Scale to zero only when the model-load and initialization time fit the product’s cold-start tolerance. For interactive services, keep a warm baseline when loading weights, compiling kernels, or attaching storage would break TTFT.

Store model weights on fast, durable storage and pre-warm only the capacity justified by a traffic forecast. Measure cold-start time separately from steady-state latency. A replica that is technically running but waiting for weights, quota, or network attachment is not productive capacity.
7. Match purchasing mode to workload risk
Discounted capacity is valuable only when its failure behavior matches the workload. Compare options using throughput per dollar, p50 and p95 latency, TTFT, memory headroom, model quality, startup time, interruption probability, regional availability, operational complexity, and billing commitment.
| Capacity mode | Best fit | Important trade-off | Published figure or condition |
|---|---|---|---|
| Spot | Fault-tolerant training, fine-tuning, batch inference, analytics, and CI | Capacity can be preempted; work must retry or resume safely | Google Cloud documents discounts of up to 91% for Spot resources, including GPUs, in its 2026 AI Hypercomputer documentation. Microsoft describes Azure Spot VMs as offering up to 90% savings versus pay-as-you-go prices. |
| Flex-start | Short workloads that can begin when capacity is available | Start time is flexible and capacity is not assured immediately | Google Cloud lists discounts of up to 53% for Flex-start resources on eligible machine series in 2026 documentation. |
| On-demand | Latency-critical production serving and workloads needing immediate capacity | Highest price, but no long-term commitment and predictable launch behavior | Use when interruption or delayed provisioning would violate the SLO. |
| Reservations or savings plans | Stable, long-lived baseline demand | Commitment can leave you paying for capacity after demand changes | Azure recommends reservations or savings plans for stable demand; commit only after utilization is demonstrably steady. |
Training and batch workloads generally favor interruption tolerance and price. Interactive inference favors predictable latency and fast scale-up. Regional GPU scarcity, quota limits, network charges, and storage fees can erase a nominal accelerator discount, so evaluate the complete deployment cost.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.8. Make interruption-prone workloads resumable
Spot is appropriate only when an interruption does not corrupt the job or create unacceptable rework. Training, fine-tuning, batch inference, analytics, and CI are candidates when they can checkpoint and retry.
Checkpoint at a useful recovery point
Persist model state, optimizer state when needed, data position, and job metadata to durable storage. Choose a checkpoint interval based on the cost of recomputing work and the storage overhead. Test restoration on a fresh instance, including dependency versions and permissions.

Retry idempotently
Design jobs so a restarted worker can safely repeat a batch without duplicating outputs. Record completed shards or request IDs, use deterministic output paths, and separate temporary files from committed results. Observe interruption frequency and recovery time; move the job to reliable capacity if retries consume the discount.
Keep latency-critical serving on reliable capacity
A user-facing endpoint should remain on on-demand or committed capacity unless an interruption-aware architecture has been demonstrated against the real SLO. A cheap replica that disappears during a traffic spike can cause retries, queue growth, and a larger bill elsewhere.
9. Commit only the predictable baseline
After several weeks of stable utilization, identify the capacity floor that traffic forecasting supports. Reserve or commit that floor and leave peaks elastic. Revisit the commitment when model versions, context lengths, traffic mix, or regions change.
Review accelerator generation, region, network topology, storage, and quota together. A lower hourly GPU price can be outweighed by cross-zone traffic, insufficient throughput, extra replicas, or idle committed capacity. Keep a small amount of reliable headroom if obtaining new GPUs in the region is slow.
10. Install a safe-change and FinOps loop
Cost optimization is an operating process, not a one-time migration. Microsoft defines it as maximizing resource value while minimizing unnecessary expense. Make every change observable and reversible.
- Evaluate offline: run the fixed quality set for precision, model-routing, caching, and batching changes.
- Canary performance: send a controlled share of production traffic and compare throughput, TTFT, p50/p95 latency, memory headroom, and errors with the baseline.
- Check the error budget: reject a change that spends reliability budget faster than the savings justify.
- Verify billing: inspect actual GPU hours, replica count, storage, network, and discounted-capacity usage by team, model, environment, and tenant.
- Keep rollback ready: retain the prior model image, precision, autoscaling policy, and capacity profile until the canary is stable.
- Alert continuously: set budgets and anomaly alerts for idle GPUs, unexpected scale-out, queue growth, interruption storms, and cost per completed unit of work.
11. A decision framework by workload type
| Workload | First levers to test | Capacity preference | Primary success measures |
|---|---|---|---|
| Interactive LLM inference | Right-size precision, prompt caching, dynamic batching, model routing, queue- or batch-based autoscaling | Warm reliable baseline with elastic on-demand capacity; MIG for validated smaller services | TTFT, p95 latency, quality, queue age, and cost per completed request |
| Offline batch inference | Maximum safe batching, cheaper precision, queue scheduling, checkpointing | Spot or Flex-start when retries are implemented | Throughput per dollar, completion time, interruption recovery, and output correctness |
| Training or fine-tuning | Checkpoint interval, data-pipeline efficiency, utilization, and restart testing | Spot for resumable phases; reliable capacity for deadlines or fragile stages | Useful training progress per dollar, time to completion, and lost work after interruption |
| Development and CI | Scale-to-zero, shared MIG slices, scheduled shutdown, and quota controls | Flex-start or Spot where start time and interruption are acceptable | Idle hours, developer wait time, test completion, and isolation |
12. What a practical rollout looks like
Start with one model and one region rather than changing the entire fleet. Establish the baseline, test precision and accelerator alternatives on the same workload, then improve utilization before adding capacity. Introduce queue- or batch-based autoscaling with conservative limits, and only then test scale-to-zero or discounted instances for workloads that tolerate their startup and interruption behavior.
Keep the old configuration available during each canary. If p95 latency, TTFT, quality, error rate, or queue age regresses, roll back first and investigate second. Once savings and SLO compliance hold through peak and quiet periods, commit the measured baseline and continue monitoring for traffic and model changes.
