The most effective way to reduce cross-datacenter traffic is to redesign communication around the network hierarchy: keep synchronization-heavy parallelism inside each data center, aggregate gradients or updates locally, send only consolidated data across the WAN, and overlap unavoidable transfers with computation. For workloads that can accept asynchronous optimization, a low-communication design such as Decoupled DiLoCo can reduce synchronization frequency much more radically. Memory-sharding systems such as ZeRO address a different problem and should not be assumed to reduce WAN bytes.
Start by separating four different problems
“Cross-datacenter traffic” can mean several measurements. Before changing the training architecture, decide which one is limiting your run:
- WAN bytes: the volume sent between sites. This is the target of aggregation, lower-frequency synchronization, and communication compression or sparsity when supported by the algorithm.
- WAN bandwidth: the link capacity available to the job. A design can send fewer bytes but still perform poorly if transfers arrive in bursts or contend with other tenants.
- Latency: round-trip time and per-message delay. High latency makes frequent collectives expensive even when the total byte count is modest.
- Memory footprint: the amount of model, gradient, and optimizer state held by each rank. Sharding can solve this without lowering WAN traffic.
Track these separately from step time, throughput, collective duration, compute utilization, and convergence. A change that lowers bytes but increases optimizer staleness or causes extra steps is not automatically an improvement.

Keep communication-intensive parallelism inside each data center
Parallelism dimensions do not generate the same communication pattern. NVIDIA’s guidance for multi-site NeMo deployments is to place the most synchronization-heavy groups within a site and use data or pipeline parallelism across sites where the model layout permits it.

| Parallelism dimension | Typical communication behavior | Cross-site suitability |
|---|---|---|
| Tensor parallelism | Frequent, high-bandwidth synchronization among shards of each layer | Poor fit for high-latency inter-site links; keep the tensor-parallel group within one data center when possible |
| Context parallelism | Frequent exchanges tied to sequence or attention computation | Prefer intra-site placement unless the WAN has the required bandwidth and latency |
| Expert parallelism | Token routing and synchronization among experts | Keep communicating experts local when the model and placement allow it |
| Data parallelism | Gradient or update collectives at synchronization points | More suitable for a controlled cross-site boundary, especially with hierarchical reduction |
| Pipeline parallelism | Activations passed between pipeline stages | Can span sites, but stage boundaries and microbatch scheduling must hide WAN latency |
This is a placement rule, not a promise that any one dimension is always cheap. Measure the actual tensor, context, expert, data, and pipeline groups created by your framework. If a supposedly local group is split across sites, fix rank placement before tuning environment variables.
Use hierarchical all-reduce to aggregate before the WAN hop
For synchronous data parallelism, replace one flat all-reduce spanning every rank with a three-level operation. NVIDIA describes the pattern as local reduce-scatter, cross-data-center all-reduce, and local all-gather.
- Group ranks by data center. Build a local communicator for every site and a separate communicator containing one representative or equivalent shard from each site.
- Reduce-scatter inside each site. Ranks exchange and reduce their gradient partitions over the fast local fabric. The result is one consolidated partition per local rank or representative.
- All-reduce across data centers. Exchange only those consolidated partitions over the long-haul link. The cross-site collective now carries aggregated site-level results rather than every intra-site copy.
- All-gather inside each site. Distribute the globally reduced partitions back across local ranks using the data center’s high-bandwidth network.
In a localized-optimizer design, optimizer state can also be sharded within each site. Each site performs the updates it can complete locally, then synchronizes only the aggregate needed for the next globally consistent step. The exact state and tensor ownership depend on the optimizer and framework, so validate numerical equivalence and convergence rather than assuming the arrangement is interchangeable with a flat all-reduce.
Quick wins for a faster PC:
Clear out junk files and repair common Windows errorsFree Scan →Scan for outdated or missing drivers - takes under a minuteDriver Scan →Repair Windows errors before they cause bigger problemsFix Now →When hierarchy helps most
- Several GPUs or nodes share a much faster intra-site fabric than the inter-site WAN.
- Each site runs a substantial local data-parallel group, so reduction can eliminate duplicate traffic before the WAN transfer.
- The training algorithm requires synchronous updates but can tolerate a multi-stage collective schedule.
When hierarchy is not enough
If every step still requires a large globally synchronized tensor, hierarchical reduction cannot eliminate the information that must cross sites; it only removes redundant intra-site copies from the WAN path. Extremely high round-trip time, unstable links, or a model whose dominant traffic is activation or token routing may require a different parallelism layout or an asynchronous algorithm.

Make the collective library aware of the real topology
A collective library cannot optimize paths it cannot see. NVIDIA’s cross-data-center NCCL approach uses fabric IDs and a network API to discover whether a path is intra-DC, cross-DC, or disconnected, then constructs rings and trees with fewer cross-site connections. This applies to homogeneous networks and to mixed deployments, such as InfiniBand or RoCE inside sites with TCP between sites.
Expose the topology consistently on every rank. Verify that fabric identifiers distinguish sites, that the network plugin reports the intended path class, and that the resulting rings or trees do not alternate unnecessarily between data centers. A topology error can turn a nominally hierarchical design into repeated WAN traversals.
NCCL controls worth testing
| Control | Purpose described by NVIDIA | How to use it |
|---|---|---|
NCCL_SCATTER_XDC |
Scatters channels so cross-DC connections are distributed rather than concentrated on one path | Test with your actual node and HCA layout; do not treat one value as universally optimal |
NCCL_IB_QPS_PER_CONNECTION |
Adjusts queue pairs for higher-latency InfiniBand or RoCE paths | Increase only while checking link utilization, congestion, and collective time |
NCCL_NSOCKS_PERTHREAD |
Controls socket concurrency for higher-latency TCP paths | Benchmark alongside CPU and NIC utilization; excessive sockets can add overhead |
NCCL_SOCKET_NTHREADS |
Controls the number of socket threads used for TCP communication | Tune with the socket count and available CPU cores rather than in isolation |
NCCL also exposes socket task-size and buffer controls. The correct settings depend on link rate, RTT, message size, CPU availability, and the network plugin. Record each tested configuration and revert settings that improve a microbenchmark but worsen end-to-end step time.
Understanding channel scattering
NVIDIA gives an illustrative configuration with four GPUs per node and a 400-Gbps host-channel adapter per GPU. A single cross-DC connection serving all four GPUs would require 1.6 Tbps; scattering can reduce the requirement on that individual connection to 400 Gbps, with additional channels distributing it further. This example explains connection distribution in the stated topology; it is not a general guarantee that total traffic or cost falls by a fixed percentage.

Overlap unavoidable WAN transfers with computation
Once the transfer is aggregated and the path is optimized, hide the remaining latency. Split gradients, optimizer state, or other cross-site payloads into chunks. Start a chunk’s transfer as soon as its local computation and reduction are complete, while later layers continue computing. Consume or apply completed chunks without waiting for the entire tensor whenever the optimizer and framework support that schedule.
Practical overlap sequence
- Profile the backward pass to identify when each gradient bucket becomes ready.
- Choose bucket sizes large enough to use the WAN efficiently but small enough to create multiple opportunities for overlap.
- Launch the local reduce-scatter for an early bucket, then enqueue its inter-site operation while later buckets are still being computed.
- Run the local all-gather or optimizer application as soon as the cross-site result is available.
- Compare exposed communication time, not just total communication time. A transfer that overlaps perfectly may leave total bytes unchanged while reducing its contribution to step time.
Do not overlap blindly. Excessively small chunks increase scheduling and protocol overhead; excessively large chunks delay the first transfer and recreate a synchronization barrier. Check for stream dependencies, GPU memory pressure, and network-plugin serialization.
Consider asynchronous, low-communication training when synchronization is the bottleneck
Decoupled DiLoCo takes a different approach from tuning NCCL. Training is divided into learner units, or “islands,” that compute largely independently and exchange updates asynchronously. This can make low-bandwidth links and partial failures less disruptive, but it changes optimization behavior, framework integration, and model-quality validation.
What the reported results show
Google DeepMind reported successfully training a 12-billion-parameter model across four US regions using 2–5 Gbps of WAN connectivity, describing the result as more than 20 times faster than conventional synchronization methods in its experiment. The same April 23, 2026 post reports 198 Gbps versus 0.84 Gbps of required bandwidth in one comparison, 27% versus 88% goodput under high hardware-failure rates, and average accuracy of 64.4 versus 64.1 for the named benchmark.

Those numbers have different contexts. Google DeepMind says the bandwidth and failure charts are based on simulated training runs, while the benchmark comparison is described as a real-world experiment. They are Google-reported results for its system, not a universal prediction for every model or WAN.
Choose asynchronous training only when its trade-offs fit
- Use it when WAN capacity or reliability makes frequent global barriers impractical.
- Confirm that your optimizer, model architecture, checkpointing, and framework support delayed or asynchronous updates.
- Define an acceptable quality target and staleness policy before comparing it with synchronous training.
- Test recovery when an island, region, or WAN path fails; fault isolation is part of the design, not an incidental benefit.
Do not confuse ZeRO memory sharding with WAN reduction
ZeRO partitions parameters, gradients, and optimizer state across data-parallel processes instead of replicating them. That removes memory redundancy, but the first two stages do not reduce the communication volume of ordinary data parallelism according to Microsoft’s description.
| ZeRO stage | State partitioned | Reported memory effect | Reported communication effect |
|---|---|---|---|
| Stage 1 | Optimizer states | 4× memory reduction | Same communication volume as data parallelism |
| Stage 2 | Optimizer states and gradients | 8× memory reduction | Same communication volume as data parallelism |
| Stage 3 | Optimizer states, gradients, and parameters | Scales with data-parallel degree | 50% communication-volume increase in the stated comparison |
These are Microsoft Research’s 2020 system comparisons, not an independent measurement of WAN bytes for every implementation. Use ZeRO when per-rank memory is the blocker; combine it with hierarchical collectives or lower-frequency synchronization when WAN traffic is the blocker.
Evaluate provider-specific collectives carefully
Cloud libraries can exploit a provider’s known topology. AWS documentation describes AllReduce and AllGather implementations optimized for AWS infrastructure, including Elastic Fabric Adapter in the described AllGather path. Such a library may be effective inside that provider’s environment, but it is not a portable cross-cloud prescription. Check supported instance types, regions, network interfaces, framework versions, and whether the implementation understands your inter-site path before adopting it.

Measure a like-for-like baseline
Run the same model, data order, precision, global batch size, optimizer settings, number of ranks, and quality target for every candidate. A vendor’s benchmark can be useful evidence, but its topology and workload may differ from yours.
Minimum telemetry
- Bytes sent and received across each site boundary, by collective and by job.
- Achieved WAN bandwidth, packet loss, retransmissions, and round-trip time.
- Collective duration, exposed communication time, and percentage overlapped with computation.
- Step time, samples or tokens per second, scaling efficiency, and GPU utilization.
- Validation loss, benchmark accuracy, final model quality, and number of optimizer steps to reach the target.
- Recovery time and quality impact after a site, node, or WAN failure.
Baseline experiments
- Run flat synchronous data parallelism and record inter-site bytes and step time.
- Keep the same workload but place tensor, context, and expert groups within sites.
- Enable hierarchical reduce-scatter, cross-site all-reduce, and local all-gather.
- Add topology-aware NCCL discovery and test channel, queue-pair, and socket settings one at a time.
- Enable chunked overlap and compare exposed communication time.
- If acceptable for the workload, run an asynchronous low-communication variant with the same quality and failure criteria.
Use the network and objective to choose a strategy
| Situation | First strategy to test | Why | Main validation risk |
|---|---|---|---|
| Fast intra-site fabric, slower but reliable WAN, synchronous optimizer required | Locality-aware placement plus hierarchical all-reduce | Aggregates locally before crossing sites | Global reduction may still dominate if gradients are large |
| Collectives use unexpected WAN paths | Topology-aware NCCL fabric IDs and path discovery | Rings and trees can avoid unnecessary cross-site links | Incorrect topology metadata can worsen routing |
| WAN RTT is high but bandwidth is adequate | Chunked communication overlapped with computation | Hides latency behind the backward pass | Chunk sizes or dependencies may expose more overhead |
| WAN bandwidth is very limited or failures are common | Asynchronous low-communication training such as Decoupled DiLoCo | Removes frequent global barriers and isolates islands | Staleness, framework compatibility, and model quality |
| Per-rank memory is the immediate failure | ZeRO or another state-sharding method | Reduces replicated model state | WAN communication may stay the same or increase |
| All ranks run within one supported provider topology | Provider-specific collective library | Can use known hardware paths | Limited portability and region dependence |
Troubleshoot common symptoms
WAN utilization is low, but steps are slow
Check for synchronization bubbles, small-message latency, and a collective waiting on the slowest rank. Profile readiness of gradient buckets and enable overlap before increasing socket or queue counts.
Traffic is higher after enabling sharding
Confirm which state is partitioned and which collective is measured. ZeRO Stage 3 has a reported 50% communication-volume increase in Microsoft’s comparison; memory savings do not imply WAN savings.
Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Scan for outdated or missing drivers - takes under a minute3Clear out junk files and repair common Windows errorsOne link is saturated while other links are idle
Inspect NCCL fabric IDs, channel scattering, and the network plugin’s path classification. A topology-aware ring or tree should distribute cross-site connections according to the actual HCA and switch layout.
Throughput improves but validation quality falls
Check whether asynchronous updates, stale gradients, changed effective batch size, or altered optimizer ordering caused the difference. Compare quality at the same training tokens or steps, not only wall-clock time.
A tuning variable helps one cluster but hurts another
Record the exact GPU count, node layout, HCA speed, WAN technology, RTT, and message sizes. NCCL controls are workload- and topology-dependent; carry settings between environments only after a controlled test.
Quick Recap
Implementation checklist
