The fastest way to lower inference cost on a constrained GPU fleet is usually to make each existing GPU do more useful work before adding hardware: measure the workload, remove idle time with continuous batching, control KV-cache memory, and then test lower-precision weights or cache formats. Speculative decoding and split prefill/decode serving can help particular workloads, but they add memory or operational overhead. There is no universal savings percentage; every change must be tested against your model, hardware, request mix, latency target, and output-quality requirements.
Start with a measured baseline
Inference cost is not just the hourly price of a GPU. For a fixed fleet, it is the amount of useful output produced before the service violates its latency, quality, or reliability objectives. A configuration that raises tokens per second but causes timeouts, retries, or unacceptable answers can increase the real cost per successful response.
Record a baseline under a stable, representative workload. Include the model and weight precision, GPU type and count, serving engine and exact version, driver and CUDA versions, arrival rate, concurrent requests, prompt-length distribution, generated-token distribution, and the service-level target. Capture time to first token (TTFT), per-token decode latency, total latency, throughput, queueing delay, error and timeout rates, GPU compute utilization, peak and steady memory use, and the number of active sequences.
Quality needs its own baseline. Use a fixed evaluation set that reflects production prompts, with task-specific checks such as exact-match accuracy, structured-output validity, retrieval-grounded faithfulness, safety classifiers, or human review. Keep the prompts, decoding parameters, and evaluation code unchanged while comparing configurations.

Measure useful output, not a single speed number
Report at least these rates:
- Successful output tokens per second: tokens from responses that complete within the target and pass basic validity checks.
- Cost per useful token or request: allocated GPU and serving costs divided by successful output, not by attempted work.
- Tail latency: p95 or p99 TTFT and completion latency, because averages hide queueing and long prompts.
- Memory headroom: the high-water mark for model weights, KV cache, activations, runtime buffers, and communication workspace.
Run each candidate long enough to include warm-up, steady state, and realistic variation in prompt and output lengths. A short synthetic test can make an optimization look better than it is in production.
Find the limiting resource before changing settings
Different symptoms call for different interventions. Low compute utilization with a growing queue often means the scheduler is not presenting enough compatible work. High memory use, preemption, or out-of-memory errors point to weights, KV cache, or temporary buffers. High TTFT with modest decode time suggests a prefill bottleneck; slow output once the first token arrives points to decode throughput. A full queue with an idle GPU can indicate admission-control or batching problems rather than insufficient hardware.
| Observed symptom | Likely constraint | First experiment |
|---|---|---|
| GPU utilization is low while requests wait | Underfilled batches, conservative scheduling, or too little concurrent demand | Enable continuous/in-flight batching and tune admission limits while watching tail latency |
| Out-of-memory errors or frequent sequence preemption | KV-cache pressure, excessive context, or too many active sequences | Reduce active concurrency or context limits and tune cache allocation |
| TTFT dominates total latency | Prompt prefill compute or long prompts | Test chunked prefill, prompt limits, and phase-specific scheduling |
| Decode tokens are slow but memory is available | Decode compute, kernel efficiency, or a small batch | Increase useful concurrency or test a supported precision and kernel configuration |
| Quality drops after a memory optimization | Precision, cache, or decoding change affects model behavior | Re-run the representative quality suite and revert or narrow the change |
Use continuous or in-flight batching to remove idle gaps
Traditional fixed batches wait for every sequence in a batch to finish before admitting another. Variable prompt and output lengths therefore leave slots idle while the longest request continues. Continuous, also called in-flight, batching admits new work as individual sequences progress. Context-prefill and token-generation steps can be interleaved, allowing the GPU to stay busier when demand is sufficient.
This is the strongest first serving change when utilization is low and requests arrive with mixed lengths. It does not create work that does not exist: at low traffic, there may be no additional requests to fill the batch. It also cannot exceed the memory available for model state and KV cache. Raising the concurrency limit can increase throughput until cache pressure, queueing, or tail latency becomes the new bottleneck.
Tune batching against the latency objective
- Enable the serving engine’s continuous or in-flight batching mode using the configuration documented for your installed version.
- Set a conservative maximum number of active sequences and maximum batch tokens. Increase one limit at a time.
- Run the baseline workload at several arrival rates, recording throughput, TTFT, p95/p99 latency, memory, and preemption or timeout counts.
- Keep the highest-concurrency setting that meets the latency and quality targets with safety headroom for traffic bursts.
Do not judge the change by GPU utilization alone. A scheduler can report high utilization while requests spend longer in a queue. Compare successful output per second and cost per successful request at the same service target.

Manage KV-cache memory deliberately
During autoregressive generation, the model stores key and value tensors for prior tokens so it does not recompute the entire attention history for every new token. This KV cache grows with sequence length and the number of active sequences. Long contexts and high concurrency can therefore exhaust memory even when the model weights fit comfortably.
Controls that affect cache pressure
- Maximum context length: Set it to the longest context the product actually needs, rather than the model’s theoretical maximum. A lower admission limit prevents one request from reserving disproportionate memory.
- Maximum active sequences: Cap concurrency so the cache has room for temporary work and traffic bursts. Increase it only after observing memory headroom and tail latency.
- Cache allocation: Configure the serving engine’s GPU-memory utilization or equivalent reservation according to its version-specific documentation. Leave space for weights, activations, communication buffers, and runtime overhead.
- Paged or block-based cache management: Use the engine’s supported paging scheme to reduce fragmentation and allow memory blocks to be assigned as sequences grow.
- Prefix or prompt reuse: Where requests share an identical prefix, enable cache reuse if the engine supports it and ensure invalidation rules prevent cross-user data exposure.
- Cache quantization: Test a supported lower-precision KV format. It can increase the number of tokens or sequences that fit, but its effect on quality and speed is model- and hardware-dependent.
vLLM’s optimization guidance covers GPU-memory utilization, tensor parallelism, chunked prefill, and preemption controls; exact option names and behavior depend on the installed release. Treat those settings as workload-specific tuning rather than guarantees of lower total cost.

Respond to preemption and out-of-memory events
- Check whether the failure occurs during model loading, prompt prefill, decode, or a traffic spike; the remedy differs by phase.
- Reduce the maximum active sequences or context length and repeat the workload.
- Inspect peak, not just average, memory. A brief long-context request can trigger an out-of-memory event even when the average looks safe.
- Reserve additional headroom for communication and temporary buffers before raising concurrency again.
- If memory remains the constraint, evaluate weight or KV-cache quantization with the quality tests described below.
Evaluate weight and cache precision as deployment experiments
Lower-precision weights can reduce model-memory use and sometimes improve throughput by using more efficient kernels. Lower-precision KV-cache formats can allow more concurrent or longer sequences. Neither change is automatically quality-neutral, and a format supported by one GPU, model architecture, or kernel may be unavailable or slower on another.
For each candidate precision, verify four things: hardware and kernel support; peak and steady memory; throughput and TTFT at the target concurrency; and representative output quality. Keep tokenization, sampling settings, prompts, and stop conditions identical during the comparison. Include adversarial and edge-case prompts, not only average examples.
| Precision experiment | Potential benefit | Required checks | Typical risk |
|---|---|---|---|
| Lower-precision model weights | More room for KV cache or additional replicas; possible kernel-speed gain | Load success, memory, throughput, latency, task accuracy, structured-output validity | Quality regression or unsupported/slow kernels |
| Lower-precision KV cache | More context or active sequences within the same GPU memory | Long-context quality, memory high-water mark, decode latency, numerical stability | Attention-state approximation changes answers or causes instability |
| Mixed precision | Preserve sensitive layers or cache portions while saving memory elsewhere | Implementation support, end-to-end quality, and operational complexity | Harder debugging and fewer portable configurations |
Keep the original configuration available for rollback. A small quality loss on a benchmark may be unacceptable for a regulated or customer-facing workflow, while a carefully bounded change can be reasonable for a low-risk summarization job.

Use speculative decoding only when memory and acceptance behavior support it
Speculative decoding uses a smaller draft mechanism to propose several tokens, then has the target model verify them. When many proposed tokens are accepted, the target can generate output with fewer sequential steps. The gain depends on the target and draft models, prompt distribution, output length, sampling settings, and implementation.

Random freezes, missing sound and display glitches usually trace back to one bad driver. Find and replace yours safely.Free scan · under a minuteThe trade-off is additional memory and work. NVIDIA’s guidance for its NIM documentation states that speculative methods require more memory than serving the target model alone. If the configuration runs out of memory, it recommends reducing KV-cache footprint, context length, or concurrency, or choosing a lighter method. That makes speculative decoding a poor first choice for a GPU already constrained by cache capacity.
How to test it safely
- Measure target-only throughput, TTFT, latency, memory, and quality on the production-like workload.
- Choose a draft configuration supported for the exact target model and serving stack.
- Repeat the test while recording acceptance rate, draft and verification work, memory peaks, and tail latency.
- Retain it only if successful output per GPU improves without violating quality, latency, or reliability targets.
A vendor example reports up to 3× throughput for Llama 3.3 70B with TensorRT-LLM speculative decoding. That is a setup-specific vendor result, not a general cost reduction or an expected result for another model, GPU, or traffic pattern.
Balance prefill and decode with chunked prefill
Prefill processes the input prompt; decode generates output tokens one step at a time. A very long prompt can monopolize the GPU and delay active generations, while prioritizing decode can leave prompt work waiting. Chunked prefill divides large prompt work into smaller pieces that can be scheduled alongside decode requests.
In vLLM deployments, chunked prefill and preemption-related controls are version-specific. Test them with the actual mix of prompt and output lengths. The objective is not maximum prefill speed in isolation; it is an acceptable combination of TTFT, inter-token latency, throughput, and queueing.

When chunking helps
- Long prompts cause visible stalls for users who are already generating tokens.
- Prefill bursts create high compute utilization but poor tail latency for decode traffic.
- You need a scheduling policy that gives decode work predictable service while still admitting large prompts.
When prompts are short and decode is the dominant cost, chunking can add scheduling overhead without solving the bottleneck. Keep it disabled unless measurements show a phase-mixing problem.
Consider disaggregated prefill and decode for phase-specific bottlenecks
Disaggregated serving places prefill and decode on separate worker pools so each phase can be scaled and tuned independently. This can help when prompt processing and token generation have materially different resource or latency requirements, or when one phase’s bursts interfere with the other.
The architecture introduces coordination, routing, and KV-cache transfer. TensorRT-LLM documentation describes overlapping cache transfer with computation, but transfer bandwidth, synchronization, failure handling, and data locality still affect the result. Separate pools can also strand capacity if the traffic mix changes.
Decision test
- Measure prefill and decode utilization, latency, and queueing separately.
- Estimate the KV-cache volume transferred per request and the available interconnect bandwidth.
- Prototype with the same model, precision, context distribution, and service-level target as the monolithic deployment.
- Compare total GPU-hours per successful request, including idle capacity in either pool and the operational cost of the additional components.
For a small or lightly loaded deployment, a single well-tuned worker is usually simpler. Adopt disaggregation only when phase-specific measurements justify its communication and operational complexity.

Calculate cost per useful output
Use a consistent accounting period, such as one hour or one day. Multiply the allocated GPU cost by the number of GPUs and the time they are reserved, then add serving infrastructure and storage costs that change between configurations. Divide by successful requests or useful output tokens. Keep failed, timed-out, and retried work in the numerator of resource use but out of the denominator of successful output.

Compare candidates at the same model version, hardware, software stack, request mix, and latency target. If one configuration serves a different maximum context or produces shorter answers, report those differences rather than presenting the raw token rate as an equivalent result.
Follow a low-risk implementation sequence
- Freeze the baseline: Save configuration files, model hashes, software versions, traffic traces, and quality scores.
- Classify the bottleneck: Determine whether the dominant constraint is utilization, compute, memory/KV cache, prefill, decode, or queueing.
- Apply serving controls: Test continuous batching, active-sequence limits, context limits, cache allocation, and supported reuse or paging.
- Retest under steady and burst traffic: Check p50 and tail latency, memory peaks, errors, and useful output.
- Test precision changes: Evaluate weight and cache formats separately so a quality or performance change is attributable.
- Test speculative decoding: Proceed only if memory headroom exists and acceptance behavior is measured.
- Prototype architectural changes: Use chunked prefill or disaggregated serving only when phase measurements show a reason.
- Canary and monitor: Roll out gradually with automatic rollback on latency, quality, memory, or error-rate violations.
Common failure modes and recovery
Throughput rises but users wait longer
Back off the concurrency or batch-token limit, inspect queueing and p99 latency, and prioritize the service target over raw GPU utilization.
Concurrency tuning triggers out-of-memory errors
Lower active sequences and context limits, inspect KV-cache peaks, and leave additional memory for temporary buffers. Consider a supported cache or weight precision experiment only after establishing a reliable baseline.
Quick wins for a faster PC:
Clear out junk files and repair common Windows errorsFree Scan →Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →Quantization changes answers
Compare the affected task slices, not just an aggregate score. Revert, use a higher precision for sensitive layers or workloads if supported, or reserve the lower-precision configuration for tasks whose quality threshold it meets.
Speculative decoding is slower than target-only serving
Check draft acceptance, draft-model overhead, verification cost, and memory pressure. Disable it when acceptance is low or when extra cache pressure causes smaller batches or preemption.
Disaggregated serving leaves GPUs idle
Inspect utilization in each pool separately. Rebalance worker counts or return to a unified deployment if traffic does not provide enough independent prefill and decode work.
Operational checklist
- Is the workload trace representative of prompt lengths, output lengths, arrival bursts, and concurrency?
- Are model, GPU, driver, serving-engine, and precision versions recorded?
- Are TTFT, per-token latency, total latency, p95/p99, errors, retries, and queueing measured?
- Are peak KV-cache and total GPU-memory figures available, not only averages?
- Does every precision or decoding change have a quality gate and rollback path?
- Are throughput claims expressed as successful output at the required latency, rather than utilization alone?
- Has the cost of additional routing, cache transfer, monitoring, and operations been included?
The practical rule is simple: first keep the GPU busy with the right work, then make that work fit in memory, and only then add complexity. Continuous batching and disciplined KV-cache limits are usually the least invasive starting points. Precision changes, speculative decoding, chunked prefill, and disaggregated serving are targeted experiments whose value depends on measured workload behavior.
