The biggest savings usually come from running the smallest model that meets your quality target, quantizing it, serving it with an efficient runtime, and keeping rented GPUs busy only when requests need them. Measure cost, latency, throughput, memory and power first; then change one variable at a time so a cheaper configuration does not quietly violate your response-time or accuracy requirements.
What actually drives rented-GPU inference cost
A rented GPU is billed by time, while your users experience tokens, latency and availability. A configuration that looks cheap by the hour can cost more per delivered token if it generates slowly, spends time waiting for memory, or remains powered on between traffic bursts. Power is also workload-dependent: prompt processing and token generation stress different parts of the GPU.
- Prefill: processing the input prompt before the first generated token. It is highly parallel and generally compute-bound.
- Decode: generating tokens one at a time after prefill. It is sequential and generally memory-bound.
- KV cache: memory holding attention state for active sequences. Long contexts and high concurrency can exhaust VRAM even when model weights fit.
- Queueing: time spent waiting for a scheduling slot. Poor batching can leave the GPU underused while users see high latency.
Google Cloud’s inference-optimization guidance describes the objective as managing compute-intensive workloads for sub-second responses and higher throughput at lower cost. Its distinction between prefill and decode explains why one setting rarely improves every metric at once.

- Input and output tokens per request.
- Tokens per second during generation.
- Time to first token (TTFT), end-to-end latency and tail latency such as p95 or p99.
- Queue depth and queue-wait time.
- GPU utilization, VRAM use and KV-cache occupancy.
- Instance start-up time and total uptime, including idle periods.
- Power or energy telemetry, when the rental provider exposes it.
- Requests completed successfully, including out-of-memory and timeout rates.
Calculate the same unit economics for every trial:
- Cost per 1,000 input tokens = GPU cost for the test window divided by input tokens served, multiplied by 1,000.
- Cost per 1,000 output tokens = GPU cost for the test window divided by output tokens served, multiplied by 1,000.
- GPU-hours per successful request = billed GPU-hours divided by completed requests.
- Energy per request = measured watt-hours divided by completed requests. If only average watts are available, multiply by measured request duration and state that this is an estimate.
Separate prefill and decode measurements. A change that lowers TTFT may increase generation latency, and a change that improves tokens per second may raise queue time or memory pressure.
Choose the smallest model that passes your quality tests
Start with a quality target defined by your real application: task accuracy, refusal behavior, structured-output validity, retrieval faithfulness or another metric your users can observe. Test smaller model variants against a fixed evaluation set and production-like prompts. A model that is 30 percent cheaper but fails a key task is not a cost reduction.
Distillation and sparsity are model-level options alongside quantization. They can reduce the work required for inference, but they must be validated on your workload rather than assumed to preserve quality. Keep the model, tokenizer, prompt template and sampling settings identical while comparing variants; otherwise you cannot tell whether a change came from the model or the serving configuration.
Quantize weights and KV cache carefully
Quantization stores weights, and sometimes attention cache, at lower numerical precision. Lower memory use can let you run on fewer GPUs, which cuts both rental time and power draw. The trade-offs are task accuracy, supported kernels, loading time and occasional changes in latency.
| Option | Where it helps | Evidence and limits |
|---|---|---|
| AWQ checkpoint | Weight memory reduction with kernels that support AWQ | GKE documentation gives Gemma 7B as an example that can fit on one L4 when quantized, rather than two unquantized L4 GPUs in the described setup. Validate quality and kernel compatibility. |
| GPTQ checkpoint | Weight memory reduction for supported GPTQ runtimes | The same GKE example cites GPTQ for Llama-2 13B on one L4 instead of two unquantized L4 GPUs in the described setup. Results depend on the exact checkpoint and runtime. |
| INT8 weights | Lower model-memory footprint with broad hardware support | Microsoft Research reports that Llama2-70B required at least four A100-80GB GPUs with FP32 weights but two in the tested setup with FP16 or INT8 weights. This is a measured configuration, not a universal placement rule. |
| FP8 KV cache | Lower cache memory and potentially better latency for large batches | GKE documentation warns that FP8 KV-cache quantization reduces inference accuracy. Test long-context quality and monitor cache-related failures. |
| FP16 or BF16 weights | A lower-risk baseline when quality or kernel support is uncertain | Usually uses more memory than integer formats; no universal cost or speed figure applies. Benchmark on the rented GPU. |
Quantization is not automatically beneficial if it forces an inefficient kernel, causes frequent dequantization, or increases retries. Compare quality, VRAM footprint, tokens per second, cost per delivered token and watt-hours per request together. Keep an unquantized or higher-precision fallback for prompts that fail your quality checks if the product can route selectively.

PagedAttention manages KV-cache memory in blocks so sequences do not need large contiguous allocations. This can improve utilization when requests have different lengths. Prefix caching avoids recomputing identical prompt prefixes, which is useful for system prompts or shared documents. Chunked prefill breaks very long prompts into schedulable work so one request is less likely to block all decoding traffic. These features still need workload-specific testing; they are not guarantees of a particular speedup.
What’s actually slowing this PC down?

When comparing runtimes, hold the model and hardware constant and watch:
- Throughput at the target concurrency.
- TTFT and inter-token latency.
- p95 and p99 latency, not just averages.
- KV-cache utilization and fragmentation.
- Out-of-memory frequency during traffic spikes.
- Operational complexity, including upgrades and distributed failure handling.
Apply continuous batching without breaking latency targets
Fixed batching waits for a batch boundary. Continuous, in-flight batching admits new sequences as existing sequences finish, allowing the scheduler to keep the GPU working while requests have different output lengths. Google Cloud identifies in-flight batching and continuous iteration as core techniques for higher-throughput inference.
- Begin with a conservative maximum number of active sequences and token budget.
- Increase the limits gradually while measuring queue wait, TTFT, inter-token latency, KV-cache occupancy and out-of-memory events.
- Set separate acceptance targets for interactive traffic and background jobs. A batch size that is excellent for offline throughput can be unacceptable for a chat endpoint.
- Test short and long prompts together. Long prefills can consume compute while short requests wait.
- Keep a rollback configuration so a traffic spike or memory leak does not require rebuilding the service.
Batching has a power trade-off. Microsoft Research reports that peak and mean power depend mainly on input-prompt size and batch size, while latency depends mainly on output size. Treat batch size as both a throughput control and a power-management control. More batching can reduce energy per token by doing more useful work per launch, but it can also raise instantaneous power and queueing delay.
Control context and output lengths
Do not allocate the maximum context window merely because the model supports it. Long prompts increase prefill work and KV-cache use; long outputs extend decode time and billed uptime. Set product-level limits based on what the feature actually needs.

- Trim repeated instructions and duplicate retrieved passages.
- Use retrieval filtering or a reranker to send only relevant chunks.
- Set a maximum output-token limit for each endpoint instead of one global maximum.
- Stop generation when a valid structured response or delimiter is complete.
- Reject or asynchronously process requests whose context exceeds the interactive latency budget.
Measure quality after every limit change. A shorter prompt that removes necessary evidence can increase retries and total cost.

Right-size the rented GPU and parallelism
First determine whether the chosen model, weights and expected KV cache fit on one GPU with headroom. If a quantized checkpoint fits on one device, compare that setup with tensor parallelism across two or more less-expensive GPUs. GKE documentation notes that tensor parallelism distributes computation and may be more cost-effective than one expensive GPU, but synchronization and networking overhead must be benchmarked.
| Configuration | When it can win | What to measure |
|---|---|---|
| One larger GPU | The model and cache fit comfortably, or inter-GPU links are slow | Hourly price, sustained tokens per second, VRAM headroom, start-up time and power draw |
| Several smaller GPUs with tensor parallelism | The model does not fit on one device or smaller instances have a much lower effective price | All-reduce and network time, tail latency, cross-device failures, total hourly price and tokens per dollar |
| Pipeline parallelism | Layers can be split when memory is the main constraint | Pipeline bubbles, synchronization, utilization and latency under the target batch size |
| Data-parallel replicas | Independent replicas can serve more concurrent requests | Load balancing, cold-start time, aggregate throughput and idle capacity |
vLLM supports distributed tensor, pipeline, data and expert parallelism. Use the simplest topology that meets your target; a theoretical memory saving is not useful if communication makes every request slower.
Turn off idle capacity for bursty traffic
For intermittent workloads, scale to zero or use an equivalent scheduler so a rented GPU is not billed while it serves no requests. Google Cloud lists Cloud Run with GPUs as a serverless option for scale-to-zero inference for bursty, low-latency workloads.
Include cold-start behavior in the decision. Model download, image startup, weight loading and graph initialization can make a scale-to-zero endpoint too slow for a strict first-request SLA. A practical pattern is:
- Keep a small warm capacity during the hours when traffic is predictable.
- Scale additional replicas from queue depth or request rate.
- Scale to zero after an idle window long enough to justify the next cold start.
- Cache model artifacts close to the rental region when storage and egress terms permit.
- Record cold-start requests separately from warm requests in your cost and latency reports.
For steady traffic, compare the cost of a warm replica with the latency penalty and extra power of repeatedly starting instances. The right answer depends on utilization, not on a universal idle timeout.
Test frequency limits and power caps on the exact GPU
Power controls can lower consumption, but their effect is hardware- and workload-specific. Microsoft Research describes power capping as reactive: it triggers when power exceeds a threshold and is therefore more likely to affect prompt-phase power peaks than sustained decode behavior. Frequency locking reduced power more consistently in the reported experiments.

Those experiments found up to a 20% reduction in peak power with up to a 7% performance loss under tested frequency-locking configurations. Treat both figures as upper observations from that study, not as a promise for your rented instance.
- Run the baseline with the provider’s default power and frequency settings.
- Apply one conservative frequency or power change that the provider permits.
- Repeat the same prompt mix, concurrency and output limits.
- Compare TTFT, tokens per second, tail latency, quality failures, watt-hours per request and peak watts.
- Reject the setting if the latency or quality penalty costs more than the energy saved.
Some rental services do not expose power controls or telemetry. In that case, use utilization, uptime and provider-level energy data when available, and do not claim a measured per-request energy reduction that you cannot observe.
Compare providers by effective delivered-token cost
Hourly GPU price is only one input. Build a comparison using the same model, precision, runtime, prompt mix and concurrency, then include:
- GPU memory and sustained tokens per second.
- Start-up time and image or model-storage charges.
- Availability, interruption or preemption policy and recovery time.
- Region latency and network performance.
- Data-egress fees and persistent-storage pricing.
- Utilization, power and energy telemetry.
- Support for the runtime, quantization kernels and distributed networking you need.
Divide the complete test-window bill by tokens successfully delivered within your latency and quality targets. A cheaper instance with frequent interruptions, slow networking or insufficient memory can have a higher effective cost than a more expensive, stable option.

Troubleshoot common failure modes
The model fits, but requests run out of memory
Weights are only part of the allocation. Reduce maximum context or active sequences, inspect KV-cache occupancy, enable a paged-cache runtime, and test whether a smaller KV-cache precision is acceptable. Leave headroom for temporary allocations and tokenizer or framework overhead.
Throughput improved but interactive latency became unacceptable
Batching or token limits are too aggressive for the endpoint. Lower the active-sequence or token budget, reserve capacity for interactive requests, and review p95 or p99 queue time rather than average tokens per second.

Quantization lowered answer quality
Evaluate a different checkpoint or precision, test sensitive tasks separately, and route quality-critical requests to a higher-precision model. Check that the runtime is using the intended quantized kernels rather than silently falling back to a slower path.
A power cap saves little energy
The cap may be reactive and miss short prompt-phase peaks, or the workload may be dominated by memory-bound decode. Measure peak and mean power separately, then test frequency locking if the rental service supports it. Keep the setting only if the measured energy reduction outweighs its performance cost.
Two cheap GPUs cost more than one expensive GPU
Measure synchronization, network transfer and pipeline bubbles. Include both devices’ billed hours and idle time. If communication dominates, use a single larger GPU or a topology with faster interconnects.

Decision rules for a practical target
- Choose quantization when the quality gate passes and the memory reduction removes a GPU or materially raises useful throughput.
- Choose continuous batching when queueing and tail latency remain within the product target at the desired concurrency.
- Choose a larger GPU when it avoids expensive synchronization, repeated out-of-memory failures or unacceptable cold starts.
- Choose scale-to-zero when idle time is a large share of uptime and cold-start latency is acceptable.
- Choose a power limit or frequency lock only after reproducing the workload and measuring quality, latency and energy together.
The durable optimization is the one that lowers cost per successful, acceptable response—not merely the one that reports the lowest hourly rate or peak-watt number.
