The most effective software strategy is layered control: schedule or migrate flexible AI jobs, enforce performance-aware power budgets, use low-power states and dynamic voltage-frequency scaling, and coordinate compute with cooling. These controls can lower temporary demand, increase useful work within a fixed electrical limit, or reduce total energy, but they are different outcomes. A 2025 field demonstration cut power by 25% for three hours on a 256-GPU cluster while maintaining AI quality-of-service guarantees; that result demonstrates peak-demand flexibility for one workload mix, not a universal savings rate.
Start by defining what “less power” means
AI infrastructure teams often use power (instantaneous watts) and energy (kilowatt-hours consumed over time) interchangeably. Software optimization must state which one it targets before a control policy is deployed.
- Peak-power flexibility: reduce demand during a constrained interval, such as a utility peak or a facility power cap. Work may be delayed, migrated, throttled, or served by a different mix of machines.
- Total-energy reduction: consume fewer kilowatt-hours for the same useful output over a defined period. A lower instantaneous draw does not prove this outcome if the workload simply runs longer.
- More useful work inside a fixed power budget: keep the site below an electrical limit while raising GPU utilization, consolidating jobs, or recovering stranded capacity.
- Facility-energy reduction: lower cooling and power-distribution consumption as well as compute energy.
Set a primary objective and guardrails for latency, throughput, quality of service (QoS), job completion time, and priority tiers. A policy that saves watts but violates an inference latency target is not an optimization for a production service.

Microsoft Research documents performance-aware capping and oversubscription; the California Energy Commission (CEC) describes server, scheduler, and grid-service technologies; Nature Energy reports a field demonstration of grid-responsive workload control; and Google describes sensor-driven cooling recommendations.
1. Flex workloads in response to demand
What the field demonstration established
The 2025 Nature Energy paper, “AI data centres as grid-interactive assets,” describes software that coordinated representative AI workloads with real-time grid signals at a hyperscale cloud facility in Phoenix, Arizona. On a 256-GPU cluster, the system reduced power use by 25% for three hours during peak demand while maintaining AI QoS guarantees. The approach required no hardware modifications or energy storage. See the Nature Energy paper for the study scope.
This is evidence of a bounded demand-response capability. It does not establish that every AI cluster can cut 25%, that the reduction persists all day, or that total kilowatt-hours fell. If jobs are delayed and later completed, energy may be shifted rather than eliminated. Report event duration, baseline load, workload mix, QoS metrics, and post-event recovery when evaluating a similar policy.

Classify jobs before allowing them to flex
Create explicit workload classes instead of treating all GPU activity as interruptible:
- Strict real-time inference: protect latency and availability; allow only small, validated frequency or placement changes.
- Batch inference and analytics: permit queueing, migration, and slower execution within a completion deadline.
- Training: use checkpointing and elastic worker counts so a run can pause or shrink during an event.
- Research and opportunistic jobs: place these behind production work and use them as the first source of demand reduction.
For each class, record a maximum interruption, deadline, minimum throughput, and recovery behavior. The scheduler can then select a combination of jobs that meets a requested megawatt reduction without violating service commitments.
Implement an event-control loop
- Receive a signal. Accept a facility power limit, utility demand-response event, or internal thermal alarm with a start time, end time, and target reduction.
- Calculate available flexibility. Query queue state, checkpoint age, replica counts, deadlines, and current power. Exclude workloads with no safe interruption path.
- Choose the least disruptive actions. Delay queued batch work, reduce elastic workers, migrate replicas to efficient hosts, or apply a validated cap before touching strict-latency services.
- Enforce and observe. Apply the changes through the cluster scheduler and host controls; sample power, latency, throughput, temperature, and QoS continuously.
- Restore gradually. Ramp workloads back in waves so a simultaneous restart does not create a rebound peak. Verify that delayed jobs meet their deadlines.
2. Apply performance-aware power capping and oversubscription
Why capping can recover stranded capacity
Facilities are commonly provisioned for occasional peak draw. If every server were allowed to reach its nameplate maximum simultaneously, operators would need to leave headroom that is unused most of the time. A power-cap controller can allocate a lower ceiling per host or virtual machine, measure actual draw, and use the resulting headroom for additional work. This is oversubscription: committing more computational capacity than the electrical system could support at an unconstrained peak, while relying on measured diversity and policy limits.

Microsoft Research describes performance-aware capping, maximizing oversubscription within performance envelopes, leveraging reserve power, and moving control granularity from servers to virtual machines. Microsoft says that, as of June 2023, its system was deployed to millions of servers across Microsoft data centers and had freed hundreds of megawatts of harvested power. Those are Microsoft’s own fleet figures and date, not an independent audit or a promise for a new facility.
Design caps around workload priority
- Assign every service a power budget, priority, and measurable performance envelope.
- Use tighter caps for background jobs and reserve headroom for latency-critical inference.
- Measure performance under cap changes; do not infer impact from utilization alone.
- Keep an emergency margin for fan response, network bursts, and correlated workload spikes.
- Make the controller capable of releasing a cap quickly when QoS or thermal limits are threatened.
Use aggregate validation, not isolated limits
NVIDIA’s DSX MaxLPS technical walkthrough describes a control loop that defines topology and resource groups, collects GPU, node, rack, and group telemetry, applies operator-defined budgets and priorities, redistributes unused allocations, and validates the result against an aggregate limit. Its stated purpose is to recover capacity under a managed power budget; it does not increase the site’s power supply. Treat this as the platform’s described operating model, not as an independent comparative benchmark. The walkthrough is available at NVIDIA Developer.
3. Schedule, migrate, and slow work at efficient operating points
Coordinate low-power states and DVFS
The CEC’s 2024 project developed a server-level low-power management system that coordinated deep sleep and dynamic voltage-frequency scaling (DVFS), selecting power-state configurations for a workload and traffic pattern. Deep sleep can save energy when a server is idle long enough to offset wake-up cost. DVFS lowers voltage and frequency to reduce dynamic power, but it can lengthen execution time; test the net energy per completed request rather than judging the setting by watts alone.
Place work where servers operate efficiently
At rack and data-center level, the CEC report describes a scheduler that used worker-server statistics to predict power and trigger load migration so servers could operate near peak energy efficiency. A practical implementation needs current measurements of utilization, power, temperature, memory pressure, network traffic, and job state. Migration should account for checkpoint or replica-transfer cost, NUMA locality, storage bandwidth, and the risk of concentrating a failure domain.
Step-by-step scheduler workflow
- Measure a baseline. Record power and completed work for each server type across representative training, inference, and data-processing loads.
- Fit an efficiency model. Estimate energy per sample, token, image, or training step at several utilization and frequency points. Keep separate models for materially different kernels.
- Mark migration eligibility. Identify jobs with checkpoints, replicated state, or restart-safe semantics. Exclude workloads whose transfer time exceeds their deadline.
- Score destinations. Prefer hosts with thermal and electrical headroom, favorable efficiency, and sufficient memory or accelerator locality.
- Migrate in small batches. Observe power and QoS after each wave; stop if latency, error rate, or temperature crosses a limit.
- Consolidate idle capacity. Once work is packed safely, place empty servers into a validated low-power state rather than leaving them lightly loaded.
4. Coordinate compute with cooling
Cooling can become a large part of facility energy, especially in dense GPU racks. Compute and cooling controls should exchange forecasts: a scheduler can avoid creating a hot spot, while the cooling system can adjust airflow or set points when load moves.
Google describes a cooling recommendation system jointly developed in 2016. It takes snapshots from thousands of sensors every five minutes and uses neural networks to predict how candidate actions affect future cooling energy consumption. The account describes recommendation support and an expansion of the optimization boundary as the system matured. It does not, by itself, establish current autonomous control or a universal savings percentage. Read the system description at Google’s data-center cooling article.

Put safety ahead of optimization
- Keep independent temperature, humidity, pressure, and equipment-protection interlocks.
- Validate recommendations in simulation or advisory mode before enabling automatic actuation.
- Limit the rate of set-point changes to avoid oscillation and mechanical stress.
- Include rack inlet temperature and thermal gradients in workload-placement decisions.
- Define a fail-safe state for sensor loss, model drift, or communication failure.
Build the telemetry and policy foundation
Optimization quality is limited by measurement quality. At minimum, collect synchronized data for:
- IT power at GPU, server, rack, and facility boundaries;
- GPU utilization, memory use, clock and frequency state, temperature, and throttling;
- CPU, memory, network, storage, and accelerator queue metrics;
- Request latency percentiles, throughput, error rate, batch size, and QoS status;
- Job priority, deadline, checkpoint age, replica count, and migration status;
- Cooling sensor readings, set points, alarms, and available thermal headroom;
- External grid or utility signals, event duration, and the facility’s contractual limit.
Use a common timestamp and retain enough history to compare like-for-like workloads. Tag every power change with the policy, cap, migration, frequency state, or cooling action that caused it. Without attribution, a lower meter reading cannot be connected to a specific software decision.
Choose the right method for the operating objective
| Approach | Response time | Workload flexibility required | Performance protection | Evidence type |
|---|---|---|---|---|
| Grid-responsive orchestration | Event-scale: minutes to hours | High; jobs must be delayable, migratable, or elastic | QoS-aware selection and controlled recovery | Nature Energy field demonstration on a 256-GPU cluster |
| Power capping and oversubscription | Seconds to minutes, depending on controller | Medium; services need a tested response to caps | Per-priority budgets and performance telemetry | Microsoft deployment description; NVIDIA vendor walkthrough |
| Scheduling and migration | Minutes to job-lifecycle scale | Medium to high; state transfer or checkpointing helps | Deadline, throughput, and thermal checks | CEC project technology description |
| Deep sleep and DVFS | Milliseconds to minutes | Low for frequency changes, higher for sleep transitions | Energy-per-work measurement and wake-up limits | CEC project technology description |
| Cooling recommendations and control | Five-minute sensing cadence in Google’s described system; actuation depends on facility equipment | Compute placement must respect thermal constraints | Independent equipment interlocks and sensor validation | Google company account |
No source provides a common, controlled head-to-head benchmark across these methods. Select based on your objective, telemetry, workload mix, and acceptable performance envelope rather than a universal ranking.
Measure savings without confusing power and energy
Establish a baseline period with comparable workload volume and service levels. Report both instantaneous and cumulative metrics:
- Power: average and 95th/99th-percentile kilowatts, peak kilowatts, and duration above a facility threshold.
- Energy: kilowatt-hours per completed training step, inference request, token, image, or other useful unit.
- Service: p50/p95/p99 latency, throughput, completion time, deadline misses, and error rate.
- Capacity: GPU-hours delivered, jobs completed, and usable work within the power budget.
- Facility: cooling energy, power-usage effectiveness where available, inlet temperatures, and thermal alarms.
- Flexibility: megawatts reduced during an event, response time, event duration, rebound peak, and deferred-work backlog.
Compare against a counterfactual that represents what the cluster would have done without the policy. For demand response, include the recovery window; otherwise a three-hour reduction can look like a saving even when the same work is merely completed later.
What the CEC estimates—and how to interpret it
The CEC report estimates that if all California data centers adopted its three project technologies, annual electricity savings could reach 1,342 gigawatt-hours, annual cost reduction could reach $163 million, and greenhouse-gas reduction could reach 596,114 metric tons. These are modeled, adoption-conditional estimates for California, not observed statewide results or a forecast for an individual facility. The source is the CEC 2024 project page.

Claiming a fixed percentage for every cluster
Why it fails: The 25% figure is tied to a three-hour, peak-demand demonstration on a specific 256-GPU cluster and workload mix.
Fix: Publish your own baseline, event duration, workload classes, QoS results, and recovery energy. Use the Nature Energy result as evidence that the mechanism can work, not as a target guarantee.
Optimizing utilization instead of useful work
Why it fails: A busy GPU can consume more energy per completed request if it causes queueing, retries, thermal throttling, or inefficient transfers.

A practical rollout plan
- Set the objective and constraints. Choose peak-demand reduction, total-energy reduction, or fixed-budget throughput. Define latency, QoS, thermal, and deadline limits.
- Instrument the stack. Align facility meters, rack and server telemetry, GPU data, scheduler events, workload labels, and cooling sensors on one timeline.
- Establish a baseline. Measure comparable jobs at current policies and calculate energy per useful output.
- Start with advisory decisions. Simulate caps, migrations, and cooling recommendations; compare predicted and observed outcomes without changing production.
- Enable low-risk controls. Apply DVFS, idle sleep, or background-job scheduling where wake-up and QoS risks are small.
- Add performance-aware caps. Introduce priority budgets and aggregate validation, with automatic rollback when service or thermal thresholds are crossed.
- Pilot workload flexibility. Use checkpointed training or batch jobs for short demand-response events before including stricter services.
- Coordinate cooling. Feed planned workload placement to cooling controls and test recommendations under conservative limits.
- Audit results. Report power, energy, useful work, QoS, thermal behavior, event rebound, and any deferred backlog. Expand only when the counterfactual comparison remains favorable.
Bottom line for AI infrastructure teams
Software can reduce AI data-center power use by controlling when work runs, where it runs, how much power each resource may draw, and how cooling responds. The strongest published field evidence is a 25% reduction for three hours on a 256-GPU cluster during peak demand, with QoS maintained and no hardware or storage added. Treat that as proof of achievable flexibility under specific conditions. For a new site, combine workload classification, measured power caps, efficient scheduling, low-power states, and guarded cooling control, then judge success by energy per useful output and service performance—not by a single percentage.
