Measure latency as a user journey, not as a single model-speed number. Track time to first token (TTFT) for initial responsiveness, inter-token latency (ITL) or time per output token (TPOT) for streaming smoothness, and end-to-end latency for the time until the complete answer arrives. Then test representative traffic, inspect percentile distributions and request slices, change one bottleneck at a time, and rerun the same workload while checking output quality and cost.

A model-core benchmark can be useful, but it does not automatically describe what users experience. Queueing, prompt construction, network hops, batching, cache state, post-processing, and the arrival pattern all affect production latency.

What “latency” means for a streamed LLM response

Different latency measures answer different product questions. Reporting only an average response time can hide slow tails, pauses between streamed tokens, or a long initial wait followed by fast generation.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
Metric What it measures Why it matters
Time to first token (TTFT) Request submission until the client receives the first output token. Initial responsiveness: whether the interface appears to react quickly.
Inter-token latency (ITL) Time between individual generated tokens. Streaming smoothness; pauses can be visible even when total time is acceptable.
Time per output token (TPOT) Average generation time after the first token, calculated as (request_latency - time_to_first_token) / (total_output_tokens - 1). Decode pacing across a response. The denominator is zero for a one-token response, so handle empty and single-token outputs separately.
Normalized time per output token (NTPOT) request_latency / total_output_tokens. A simple per-token normalization, but definitions vary among tools; state the formula when comparing systems.
End-to-end request latency Request submission through receipt of the complete response. The full user wait, including queueing, batching, network transfer, and streaming-result handling.
Throughput Requests per second and output tokens per second; total-token throughput can include input and output tokens. Capacity and cost planning. Requests per second alone is misleading when context lengths differ.

NVIDIA’s metric guidance notes that TTFT generally includes queueing, prefill, and network latency. Longer prompts can increase TTFT because the server must process the prompt to build the key-value (KV) cache. End-to-end measurements include queueing, batching, and network effects. Google Cloud’s definitions likewise distinguish TTFT, ITL, TPOT, NTPOT, and output-token throughput. Tool implementations differ, so numeric comparisons are meaningful only when the definitions and boundaries match.

Set a latency objective before benchmarking

There is no universal “good” TTFT or response-time threshold. A voice interaction, an autocomplete suggestion, a report-generation job, and a chat answer have different tolerances. The right objective depends on interaction design, prompt and output lengths, model, streaming behavior, expected load, and the cost of extra capacity.

Write the objective in observable terms and include a tail percentile at the expected load. For example, an interactive product might specify a TTFT percentile and a separate ITL percentile for streamed answers, while a batch workflow may care primarily about completion time and tokens per second. Treat these as product decisions rather than borrowing a target from another provider’s example.

  • Identify whether the user needs a quick visual response, steady streaming, a complete answer, or all three.
  • Choose percentiles such as p50, p90, p95, and p99 that expose the slow tail; keep the mean as a supplementary statistic.
  • State the workload conditions beside every target: model and version, input and output lengths, concurrency, arrival rate, streaming mode, and measurement boundary.
  • Define quality and cost limits alongside latency. A faster configuration that produces unacceptable answers or exceeds the serving budget is not a successful optimization.

Build a representative benchmark

Benchmark traffic that resembles production rather than an idealized short prompt. Results change with prompt length, generated length, request mix, concurrency, arrival timing, cache state, and protocol.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Include the dimensions that drive work

  • Input lengths: use the distribution of real context sizes, including long-tail prompts.
  • Output lengths: include short answers and long generations; decode behavior is not constant across lengths.
  • Request mix: represent the proportions of chat, summarization, extraction, coding, or other workloads your service actually receives.
  • Arrival pattern: test both steady traffic and bursts. A constant-rate test and an exponential (random) arrival pattern can produce different queues.
  • Concurrency: sweep from low load to the planned operating point and beyond it to expose saturation.
  • Streaming: measure the same streaming or non-streaming protocol used by clients. Partial-result handling can affect observed timing.
  • Cache state: distinguish cold starts and cold KV or prefix caches from warmed operation, and document the warm-up procedure.

Use a stable prompt dataset or controlled input/output sequence lengths so that repeated runs are comparable. The TensorRT-LLM backend benchmark supports a dataset or user-specified sequence lengths and allows arrival timing to be changed from its default exponential pattern to constant timing. Those controls are useful for isolating effects, but they do not replace an application-level test.

Define two measurement boundaries

At the outer boundary, record the client-observed journey: the time the application submits the request, receives the first token, receives each subsequent token, and receives the final byte. This is the experience your product must meet.

At an inner boundary, record server or model timings when available: queue wait, prefill, decode, batching, and network transfer. The TensorRT-LLM core benchmark measures TensorRT-LLM inference and excludes third-party preprocessing and postprocessing. Pairing it with client timings prevents a fast core result from being mistaken for full application latency.

Keep each run reproducible

Record the model and model version, serving software and version, accelerator type, quantization, batch policy, routing policy, cache state, warm-up conditions, request distribution, arrival pattern, concurrency, and exact start and end times. Change one relevant variable per experiment and rerun the same workload. Otherwise, an apparent gain may simply reflect a different mix or a warmer cache.

Instrument TTFT, ITL, TPOT, and completion time

Capture event timestamps

For every request, capture at least:

  1. Client submission time.
  2. Time the serving endpoint accepts the request, if available.
  3. Time the first output token is received by the client.
  4. Each subsequent token arrival time, or enough information to derive inter-token gaps.
  5. Time the final response is received.
  6. Input-token and output-token counts, model identifier, route, status, and cancellation reason.

Compute TTFT from submission to first received token. Compute end-to-end latency from submission to complete receipt. For ITL, subtract adjacent token-arrival timestamps and retain the individual observations before aggregating them into percentiles. Averaging all gaps into one number can conceal pauses that users notice.

For TPOT, use (request_latency - time_to_first_token) / (total_output_tokens - 1) when at least two output tokens exist. Log empty and one-token responses in separate categories rather than emitting an undefined or misleading value. For NTPOT, use request_latency / total_output_tokens and state that definition in dashboards and reports.

Report distributions and request slices

Publish p50, p90, p95, and p99 for TTFT, ITL or TPOT, and end-to-end latency. Include request rate and output tokens per second. Slice every distribution by model, input-length band, output-length band, concurrency, route, streaming protocol, and cache state where possible. A single aggregate percentile can improve simply because the traffic mix shifted toward short prompts.

Monitoring systems may not be instantaneous. Google Cloud Monitoring documentation describes response-time and TTFT distributions with model and context-window labels; those particular metrics are sampled every 60 seconds and can appear up to 120 seconds later. Use such signals for operational trends, and use request traces or application logs when investigating an individual spike.

Prefill is prompt processing

During prefill, the model processes prompt tokens in parallel and builds the KV cache. Long or input-heavy requests therefore tend to increase TTFT and consume prompt-processing capacity. Summarization and classification workloads may be dominated by this stage.

Decode is sequential generation

During decode, the model generates output tokens one at a time using the KV cache and previous tokens. Long generations are sensitive to inter-token pacing and decode capacity. A service optimized for prompt-heavy traffic can behave differently from one optimized for long-form generation.

Use traces to locate the wait

Compare TTFT with server spans and queue depth. A high TTFT with a long admission or queue span points to overload or scheduling; a high TTFT with little queueing but long prefill points to context processing; a normal TTFT followed by large ITL gaps points to decode contention, memory pressure, or scheduling. High accelerator utilization is not proof of a user-facing bottleneck: utilization and memory are separate signals that must be interpreted with request timings.

A repeatable measurement loop

  1. Define the objective. Choose the user-visible experience and tail percentiles that matter at expected load.
  2. Assemble representative traffic. Reproduce input and output lengths, request mix, arrival pattern, concurrency, protocol, and cache conditions.
  3. Measure both boundaries. Collect client-observed TTFT, ITL, and completion time plus server-side queue, prefill, and decode timing where available.
  4. Inspect distributions and slices. Look for tail behavior and identify whether a particular model, context band, route, or load level is responsible.
  5. Form one bottleneck hypothesis. Examples include queue admission, prompt processing, decode pacing, network transfer, or post-processing.
  6. Change one variable. Alter batching, routing, quantization, cache policy, preprocessing, or infrastructure only after recording the baseline.
  7. Rerun the identical workload. Preserve warm-up, cache, arrival, and concurrency conditions so the comparison is valid.
  8. Check quality, capacity, and cost. Run representative golden data and automated evaluation, then compare useful output per unit cost and available headroom.

Reduce latency in a controlled order

Remove avoidable request-path work

Profile prompt construction, tokenization, safety or policy checks, network hops, queue admission, response parsing, and post-processing. A model-only benchmark omits some of these operations. Moving unnecessary work off the critical path or reducing repeated serialization can improve client-observed TTFT without changing the model.

Right-size batching

Batching can improve hardware utilization and throughput, but it also changes queueing and latency. Test batch sizes and batching windows at representative traffic. Increase the batch size only while the latency objective remains satisfied or throughput continues to improve. The best setting is workload- and hardware-specific; the largest possible batch is not automatically best.

Match infrastructure to workload shape

For prompt-heavy services, compare prefill performance and memory behavior. For long generations, prioritize decode throughput and stable ITL. Validate price-performance using the same request distribution, because a platform result measured on a different model, context length, or arrival pattern will not transfer reliably.

Evaluate serving optimizations one at a time

  • Continuous batching: admits requests as others finish, potentially improving utilization while changing individual wait times.
  • PagedAttention or related KV-memory management: can improve memory efficiency and capacity; measure its effect on TTFT, ITL, and tail latency.
  • Quantization: may reduce memory use and increase throughput, but verify output quality and any change in per-token pacing.
  • Speculative decoding: can accelerate generation when draft-token acceptance is favorable; test quality, acceptance behavior, and tail latency.
  • Prefill/decode disaggregation: separates resources for the two stages, which may help mixed workloads but adds scheduling and data-transfer complexity.

Each technique can trade latency against throughput, memory, cost, or quality. Keep the baseline workload and evaluation set unchanged for every trial.

Use load-aware and content-aware routing

Routing can account for queue depth and KV-cache utilization rather than sending every request by simple round robin. Matching a request’s prefix to a worker that already has the relevant cached context can reduce repeated prefill.

A Google Cloud production case study reported 35% faster TTFT for Qwen3-Coder after an intelligent-routing migration, a 52% P95 tail-latency improvement for DeepSeek V3.1 on bursty chat traffic, and an increase in prefix-cache hit rate from 35% to 70%. These are vendor-reported results for the named workloads and should be treated as case-study evidence, not as a forecast for another model, cluster, or traffic pattern.

Balance latency and throughput

Throughput and responsiveness are coupled. Increasing concurrency or batch size can raise output tokens per second while increasing queue wait and TTFT. Reducing concurrency may improve individual latency but leave expensive accelerators underused.

Comparison question Measure consistently
Does the change improve initial response? TTFT p50/p95/p99 at the target arrival rate and concurrency.
Is streaming smoother? ITL or TPOT percentiles, plus the distribution of long token gaps.
Does the full answer arrive sooner? End-to-end latency percentiles grouped by output length.
Did capacity improve? Requests per second and output tokens per second at the same latency objective.
Does the result hold under bursts? Queue depth, tail latency, and recovery time during bursty arrival tests.
Is it economically useful? Cost per useful output, memory footprint, capacity headroom, and quality score.

When prompt and output lengths differ materially, report separate groups rather than one blended number. Requests per second can look better simply because the new test contains fewer tokens; output-token and total-token throughput reveal that distinction.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Common failure modes and fixes

“The benchmark is fast, but users wait.”

Check the measurement boundary. A core inference benchmark may exclude tokenization, prompt assembly, network transfer, queueing outside the server, and post-processing. Add client timestamps and spans for each step, then compare the same request IDs across layers.

“Average latency improved, but complaints continue.”

A comparison checklist for models and serving stacks

Use the same request distribution and document every condition when comparing model servers, hardware, batching policies, routing, or quantization.

  • Model name, revision, context limit, and serving software version.
  • Accelerator type, count, memory, precision or quantization, and utilization.
  • Input-token and output-token distributions, including long-tail groups.
  • Concurrency, arrival rate, burst profile, and warm-up procedure.
  • Batching policy, cache policy, routing policy, and streaming protocol.
  • TTFT, ITL or TPOT, and end-to-end latency percentiles.
  • Requests per second, output tokens per second, and total-token throughput.
  • Whether timings are client-observed, server-observed, or model-core only.
  • Output quality, memory behavior, capacity headroom, and cost per useful output.

Do not compare a TTFT from one tool with a “first response” value from another until you confirm that both start and stop at the same events. NVIDIA cautions that benchmark implementations vary; aligned definitions are a prerequisite for meaningful numbers.

Operate latency as a production control loop

After launch, keep the measurement loop running. Alert on the latency percentiles tied to the product objective, not on utilization alone. Correlate tail events with queue depth, input length, output length, cache hit rate, batch composition, route, accelerator memory, and deployment version. When a regression appears, preserve a representative trace and replay it in a controlled benchmark before changing several variables at once.

Use standardized golden datasets and automated evaluation to track model performance reproducibly. A serving change is complete only when the measured latency improvement survives representative traffic, the quality checks pass, and the resulting capacity and cost fit the service’s operating limits.
