Manage an AI data lake with a policy that connects purpose, classification, retention, recovery, deletion and proof. There is no universal number of days for training data. Instead, define how long each data class is needed, when it may move to archive storage, how long recovery mechanisms remain available, what event starts deletion, and which approved holds suspend that process.

Then implement those decisions across every representation: source objects, curated tables, embeddings and indexes, model checkpoints, logs, snapshots, backups, replicas and catalog metadata. A storage lifecycle rule can tier or expire objects, but it does not by itself prove that every copy or derived representation has been erased.

What retention means in an AI data lake

Retention is a business and governance decision implemented through technical controls. The right period depends on the data’s purpose, sensitivity, jurisdiction, contractual commitments, organizational requirements and applicable obligations. A training corpus retained for an active product has a different justification from a temporary feature-engineering export, an audit log or a model checkpoint kept for rollback.

Use four separate clocks

  • Active-use period: how long teams may use the data for its stated purpose.
  • Archive period: how long it remains available in a lower-cost tier for infrequent access.
  • Recovery period: how long versions, snapshots, time travel, fail-safe storage, backups or replicas can restore it after a change or deletion.
  • Deletion period: when the organization’s controls must remove the data and its governed derivatives, subject to approved exceptions.

These clocks can overlap. For example, a table may leave active storage after its use period while a backup remains recoverable for a separate, documented window. Calling the first transition “deletion” would give an inaccurate compliance result.

Define purpose before duration

Write a purpose statement for each class, such as model training, fraud investigation, safety monitoring, billing, incident response or temporary experimentation. Record the owner who can confirm that purpose is still valid. When the purpose ends, the default action should be archival or deletion according to the class policy, not indefinite retention because storage is inexpensive.

Inventory every data representation

Start with an inventory that follows lineage rather than only counting buckets or tables. Catalog the source, transformations and recovery paths for each asset. Governance guidance for data and AI assets supports this cataloging approach, but the exact deletion behavior of each asset depends on the deployed stack.

Asset class Examples to inventory Signals and ownership Deletion dependencies
Raw inputs Object files, event streams, uploaded documents, images and audio Source system, collection purpose, sensitivity, jurisdiction, owner and creation time Object versions, replication, quarantine copies, legal holds and downstream transforms
Curated data Cleaned tables, feature tables, joins and quality-checked partitions Lineage to raw inputs, last-use time, dataset steward and classification Table snapshots, materialized views, exports and dependent training sets
Derived AI data Embeddings, vector indexes, labels, feature caches and retrieval stores Source-record lineage, model or pipeline version, refresh schedule and access scope Index segments, replicas, caches and copies embedded in downstream artifacts
Model artifacts Checkpoints, evaluation sets, packaged models, adapters and prompt assets Training run, approval status, deployment status, owner and rollback need Model registries, deployment replicas, container layers and exported packages
Operational records Pipeline logs, access logs, quality metrics, lineage events and audit records Log category, personal-data content, security purpose and retention owner Log aggregation, cold archives, SIEM copies and incident-case exports
Recovery and metadata Snapshots, backups, replicas, catalog entries, schemas and table metadata Recovery objective, region, account, catalog or metastore owner Independent expiry schedules, fail-safe windows, backup immutability and catalog retention

Record a stable asset identifier and lineage links so a deletion request can be traced from an individual source record to affected partitions, embeddings, indexes, evaluation data and models. If a platform cannot identify such links, document that limitation and define a compensating review.

Set a policy matrix instead of one lake-wide number

For each class, approve a policy with the fields below. The values must come from your organization’s purpose and obligations; they are not universal legal periods.

Policy field Decision to document
Classification Public, internal, confidential, regulated, sensitive personal data or another approved taxonomy
Active-use duration How long the asset supports the stated purpose before review, archive or deletion
Archive duration Whether an infrequently used copy is allowed, in which tier and for how long
Recovery window Permitted time for versions, snapshots, time travel, fail-safe storage, backups and replicas to restore data
Deletion trigger Purpose completion, source-record request, contract end, dataset supersession, incident closure or another defined event
Hold exception Who may place, review and release a legal, investigation or security hold
Approver and evidence Named data owner, governance approver, policy version and required execution records

Privacy principles generally favor keeping identifiable personal data no longer than necessary, but the applicable period depends on jurisdiction, sector, data category and purpose. Do not claim that a particular duration or control satisfies a regulation without jurisdiction-specific legal review.

Translate policy into lifecycle controls

Use storage lifecycle rules for tiering and expiry

Object-storage lifecycle policies can move matching objects to lower-cost storage classes or expire them. AWS describes S3 Lifecycle as helping store objects cost effectively by transitioning them to lower-cost storage classes or deleting expired objects. Rules apply to the object groups selected by their prefix, tags, object size or other supported selectors, so an imprecise selector can retain too much data or delete the wrong class.

Transition operations can incur request charges. Include active-storage cost, archive-storage cost, transition requests, retrieval charges and minimum-storage-duration effects in the policy review. A rule that saves capacity but causes frequent restores may be more expensive than keeping the data active.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Use TTL for explicitly temporary artifacts

Time-to-live controls are appropriate for nonessential logs, temporary feature outputs, scratch datasets and short-lived model artifacts when the platform supports a reliable TTL. Google Cloud guidance recommends TTL controls for temporary artifacts and retention tags for governance. Give each TTL an owner and an exception process; otherwise a temporary export can become an untracked permanent copy.

Design selectors around lineage

Do not select objects only by a broad bucket or prefix if it contains multiple purposes or classifications. Prefer separate storage locations or mandatory classification tags. Test a rule against a report of matching objects before enabling expiration, and include versioned objects, incomplete multipart uploads and archive tiers where the service supports separate behavior.

Separate retention from recoverability

A user-visible delete does not necessarily mean the bytes are immediately unrecoverable. Version history, snapshots, time travel, fail-safe storage, backups and replication can preserve older states under separate controls. Your policy should state who can restore those copies, for what purpose, and when each recovery path expires.

BigQuery example: two recovery windows

BigQuery documents a default seven-day time-travel window. The configurable range is two to seven days. After that window, an additional seven-day fail-safe period applies. Fail-safe data cannot be queried directly by customers; recovery requires Cloud Customer Care. These are product-specific recovery mechanisms, not a universal retention setting for every data lake.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

When calculating deletion completion, record the end of the user-accessible time-travel period and the later fail-safe expiry separately. Storage billing consequences also differ between physical and logical billing models, so finance and platform owners should evaluate the selected model before changing recovery settings.

Ask five questions for every recovery copy

  1. What mechanism creates the copy: versioning, snapshot, backup, replication, time travel or fail-safe storage?
  2. What is its exact retention window and is that window configurable?
  3. Can customers query or restore it directly, or is provider assistance required?
  4. Who is authorized to restore it and how is that action logged?
  5. Does billing continue while the copy exists?

Use immutability only for preservation cases

Immutability protects records from modification or deletion during a defined period; it is not a deletion mechanism. Apply it when an approved preservation requirement outweighs the need for ordinary expiry, and define how holds are released.

Amazon S3 Object Lock

S3 Object Lock requires versioning and acts on object versions. In a locked state, a lifecycle expiration cannot delete the protected version. Governance and compliance modes provide different protections against bypass, so select the mode, retention interval and authorized override path deliberately. Inventory locked versions separately from ordinary objects when calculating deletion completion.

Azure Blob Storage time-based WORM

Azure Blob Storage supports time-based write-once, read-many retention that prevents modification or deletion during the interval. Version-level policy requires versioning. Microsoft recommends locking the policy within a reasonable period, typically under 24 hours; confirm the scope, approval and audit requirements before locking because a locked policy is harder to change.

Immutability can also interrupt pipelines. AWS documents that enabling default S3 Object Lock retention can interrupt normalized log delivery in Amazon Security Lake. Test ingestion, rotation and expiration together before applying a default lock broadly.

Govern metadata and derived data separately

Data rows are only one part of an AI lake. Catalog entries, schemas, partitions, lineage records, embeddings, indexes, caches and model artifacts can preserve information about a source after the source object expires.

Amazon Security Lake documents Region-level retention and, when retention is not configured, a default that stores data indefinitely in S3 Standard. Its retention policy excludes Apache Iceberg metadata. Therefore, deleting normalized objects does not establish that Iceberg metadata has followed the same schedule. Give metadata its own owner, retention rule and deletion evidence.

For embeddings and indexes, define whether the representation can reveal or reconstruct source information. Link each segment or vector batch to source records and pipeline versions where feasible. If the platform cannot surgically remove affected vectors, specify a rebuild-and-swap procedure: stop reads from the old index, build a replacement without the deleted records, validate it, switch traffic, and expire the old index and its replicas under a documented hold check.

Seven-step implementation sequence

  1. Inventory and classify. Record owner, purpose, sensitivity, jurisdiction, creation and last-use signals, lineage and storage location for raw inputs, curated data, embeddings, indexes, checkpoints, logs, snapshots, backups and metadata.
  2. Set retention by class and purpose. Approve active-use duration, archive duration, recovery period, deletion trigger, hold exception and responsible approver. Keep legal review separate from technical configuration.
  3. Translate policy into lifecycle controls. Configure storage rules for tiering and expiration, TTLs for temporary artifacts, selectors for each class and a cost estimate for transition requests and retrieval.
  4. Separate recoverability from retention. Document version history, snapshots, time travel, fail-safe, backups and replication, including restoration authority and the date each mechanism expires.
  5. Apply immutability only where justified. Choose scope and mode intentionally, test holds and administrative bypass, and verify how locked versions interact with automated deletion.
  6. Monitor and prove execution. Log policy changes and deletion outcomes, alert on failures, test expiration and recovery behavior, and retain evidence appropriate to organizational requirements.
  7. Revalidate after platform changes. Cloud defaults, supported scopes, recovery windows and costs can change. Verify current service documentation before publishing or relying on exact configuration settings.

Compare platform semantics, not policy names

Platform or control Scope and granularity Recovery or deletion behavior Important caveat
Amazon S3 Lifecycle Rules target matching object groups and can transition or expire objects Expiration is subject to versioning, locks and other copies Transition requests can cost money; selectors must be tested
S3 Object Lock Object versions, with governance or compliance protections Locked versions cannot be deleted by lifecycle expiration Requires versioning and is a preservation control, not a purge control
Amazon Security Lake retention Region-level retention for its stored data Unconfigured retention is documented as indefinite storage in S3 Standard Apache Iceberg metadata is excluded; default Object Lock can interrupt normalized log delivery
BigQuery time travel and fail-safe Table or dataset recovery semantics defined by the service Seven-day default time travel, configurable from two to seven days, followed by seven days of fail-safe Fail-safe is not directly queryable and requires Cloud Customer Care for recovery
Azure Blob time-based WORM Blob or version scope, with versioning required for version-level policy Prevents modification or deletion during the locked interval Confirm scope and audit needs before locking; locked policy changes are constrained
Google Cloud TTL guidance Temporary artifacts and governed assets, subject to service support TTL can automate expiry for eligible data TTL does not automatically purge unrelated indexes, backups, exports or metadata

Use the same comparison worksheet for any additional service: scope, granularity, deletion semantics, recovery windows, metadata coverage, governance and cost. Two products that both advertise “retention” may operate at object, table, version, region or catalog level and therefore produce different outcomes.

Build a deletion runbook that follows lineage

When a purpose ends or an approved request arrives, execute deletion as a controlled workflow rather than a single storage command.

  1. Validate authority and scope. Confirm the requester, affected records, jurisdiction, classification and any legal, security or investigation hold.
  2. Freeze new derivatives. Pause ingestion, feature generation, embedding jobs, index refreshes and training pipelines that would recreate the data during deletion.
  3. Enumerate descendants. Use lineage to identify curated partitions, exports, embeddings, indexes, caches, evaluation sets, checkpoints, logs, snapshots, replicas and catalog metadata.
  4. Apply platform deletes. Run the approved expiration or purge operation for each store, recording object versions, table partitions and response status.
  5. Handle immutable or inaccessible copies. Record the lock or fail-safe expiry date, the authorized recovery path and why immediate deletion is not technically available.
  6. Rebuild derived stores when necessary. Replace indexes or artifacts that cannot remove individual records, validate the replacement and retire the old copy.
  7. Verify and attest. Search each store, check policy logs and lineage, confirm that no active pipeline recreates the data, and issue an attestation that distinguishes deleted, pending expiry and preserved-under-hold states.

Monitor execution and prove the result

Operational monitoring should detect both missed deletion and accidental deletion. Track policy version, selector changes, objects or partitions matched, transition and expiration outcomes, failed operations, pending holds, restoration events and the age of the oldest recoverable copy.

  • Alert when a policy has no matching assets, an expected asset has no policy, or an expiration job fails.
  • Report assets whose active-use period has ended but remain in hot storage.
  • Reconcile source records with embeddings, indexes and model artifacts after every material deletion workflow.
  • Run scheduled recovery tests to confirm that documented snapshots, time travel and backups behave as stated.
  • Retain audit and activity logs for policy edits, lock changes, deletion requests, approvals, bypasses and restorations.

Azure documents policy audit logging and activity logs for its immutability features. Equivalent evidence should be enabled for every platform in the lake, with access restricted to the governance and security roles that need it.

Common failure modes and fixes

Symptom Likely cause Fix
Objects expired but a search still finds the data Versions, replicas, snapshots, indexes, backups or metadata were outside the rule Trace lineage and enumerate every representation; add separate controls and evidence
Lifecycle rule never deletes a file Object Lock, a legal hold or a version-specific condition blocks expiry Identify the lock owner and expiry, then document preserved state rather than forcing a bypass
Storage cost rises after enabling archive Transition requests, retrievals or minimum-storage charges offset capacity savings Model access frequency and all request charges before changing tiers
Temporary artifacts accumulate No TTL, unowned exception or failed cleanup job Assign an owner, set a supported TTL, alert on failures and review exceptions
Training reproduces deleted records Old checkpoints, exported datasets or cached features remain usable Freeze pipelines, revoke the old artifact, rebuild affected derivatives and record the lineage decision
Deletion evidence is inconclusive The platform exposes user-visible expiry but not fail-safe or provider-held copies Report each state separately and include the documented recovery expiry and access path

Balance compliance, recovery and cost

Use a decision review for each class rather than optimizing one dimension. A shorter recovery window lowers storage exposure and cost but reduces rollback capability. A longer archive or backup period improves investigation and resilience but extends the time during which a deletion request may remain recoverable. Immutability strengthens preservation but can block ordinary expiry and pipeline operations.

  • Choose the shortest active period that still supports the approved purpose and operational quality requirements.
  • Keep archive copies only when their retrieval value is documented and the total storage, transition and restore cost is understood.
  • Set recovery windows from recovery objectives, not from the active-retention number.
  • Use holds narrowly, with an owner, reason, review date and release evidence.
  • Require deletion attestations to describe residual states: physically expired, awaiting service-defined expiry, preserved under hold or not directly accessible to the customer.

A practical policy record

For each dataset or artifact, store a machine-readable record containing: asset identifier, classification, purpose, owner, jurisdiction, active-use end event, archive rule, recovery mechanisms and expiry dates, deletion trigger, hold status, derived-asset links, lifecycle policy version, last execution result and evidence location. This record lets platform automation enforce the policy while governance teams can explain what remains recoverable and why.

The result is a lifecycle system that is measurable rather than merely configured: data moves or expires according to purpose, recovery paths are visible, immutable records are preserved only when justified, derived assets are included, and deletion claims are limited to what the platform can actually demonstrate.
