The reliable way to find an AI-cluster bottleneck is to correlate a repeatable workload slowdown with time-aligned telemetry, then test the suspected subsystem against an isolated baseline. GPU utilization alone cannot tell you whether GPUs are compute-bound, waiting for data, blocked on communication, or being constrained by power or temperature.
Start with the workload symptom, not a dashboard metric
Record what “slow” means before changing settings. Capture the job’s throughput or step time, start and end times, participating ranks and nodes, data set or input version, software and driver changes, placement policy, and whether the slowdown repeats. Compare like workloads: a different batch size, sequence length, checkpoint pattern, or node allocation can legitimately change the time per step.
Use a narrow time window. A cluster can look healthy over an hour while a five-minute thermal event, storage stall, or failed network path stretches only some training steps. Save the affected run and an unaffected run when possible. The comparison should answer three questions:
Crashes, No Sound, or Screen Glitches?
Random freezes, missing sound and display glitches usually trace back to one bad driver. Find and replace yours safely.Free scan · under a minuteWindows Errors? Fix Them Before They Spread
Repair common Windows errors and clear accumulated junk for a smoother, more stable PC - no reinstall needed.Free scan · no reinstall- When did the workload outcome change?
- Which devices, paths, or nodes were active at that moment?
- Does an independent test of the suspected component show the same weakness?
NVIDIA’s observability guidance treats compute, networking, storage, orchestration, and application behavior as connected layers. That is a better diagnostic model than treating one panel, especially GPU utilization, as a complete explanation.

Build a time-aligned evidence set
Collect telemetry at a resolution that can show the event, and use the same clock or synchronized timestamps across systems. At minimum, align workload traces with per-GPU utilization, clocks, temperature, board power, throttle or health events, GPU memory and data-path errors, GPU communication activity, node CPU and memory pressure, NIC and fabric counters, and storage-side wait or latency measurements.
Separate four kinds of evidence so they are not confused:
| Evidence type | What it can establish | What it cannot establish by itself |
|---|---|---|
| Workload outcome | That throughput, step time, queue time, or input wait changed. | Which subsystem caused the change. |
| Passive health telemetry | Observed state, errors, clocks, temperatures, power, and events while the cluster runs normally. | That a device will perform correctly under an active stress or communication test. |
| Active diagnostic | Whether selected compute, memory, PCIe, peer, NVLink, power, thermal, or collective paths behave under a controlled test. | That the application is configured correctly or that the whole facility has adequate capacity. |
| Isolated bandwidth or latency test | Capacity and latency of a specific memory, GPU, NIC, or fabric path. | That the application’s rank mapping, input pattern, or collective algorithm uses the path efficiently. |
Use all four where practical. A clean passive view does not prove performance under load, and a strong isolated link test does not prove that a distributed job has the right affinity or topology.
Turn the slowdown into one testable hypothesis
Do not investigate every subsystem at once. Select one candidate fault domain, state the expected observation, and define a result that would falsify it. The following map keeps similar symptoms from being conflated.
| Candidate bottleneck | Typical workload clue | Measurements to compare | Scope to check |
|---|---|---|---|
| GPU compute or device health | One GPU or node progresses more slowly; compute phases have inconsistent throughput. | Clocks, utilization, errors, memory behavior, DCGM diagnostics, and peer-device comparison. | Individual GPU, node, and equivalent peers. |
| GPU memory or copy path | Low arithmetic progress with high memory activity or long device-to-device copies. | GPU memory bandwidth, PCIe and NVLink copy tests, and application memory stalls. | GPU pair, bus segment, and node topology. |
| GPU-to-GPU communication | Collective phases or synchronization dominate step time, especially within a node. | Topology, peer access, GPU communication bandwidth, and collective timing. | GPU pair, node, and rank placement. |
| GPU-to-NIC or inter-node fabric | Ranks wait at collectives; performance changes with node placement or traffic. | GPU Direct path, NIC affinity, fabric bandwidth and latency, errors, and NCCL timing. | GPU/NIC pair, host, switch path, and job allocation. |
| Storage or data delivery | Input workers or data-loader queues empty during otherwise idle GPU periods. | Phase-aligned input wait, request latency and concurrency, cache state, and storage-side counters. | File or object system, client nodes, and data path. |
| Power or cooling | Clocks fall or throttle events coincide with a slowdown; temperatures or power approach configured limits. | Clock, temperature, board power, throttle reasons, site electrical data, and cooling telemetry. | GPU, node, rack, room, and facility. |
The scope matters. A single outlier GPU suggests a different investigation from a rack-wide event, and a whole-cluster slowdown during a scheduled load step may be a facility constraint rather than a bad device.
Run the diagnostic sequence
1. Reproduce under controlled conditions
- Pin down the workload version, batch and sequence dimensions, data subset, software stack, rank count, node list, and placement.
- Run a short baseline that normally completes the same phases. Save step-time and throughput distributions, not only an average.
- Repeat the slow case with the same allocation when possible. If the result disappears, compare placement, network path, cache state, and background load before declaring the issue fixed.
- Record whether the slowdown affects every rank or only the ranks attached to one node, GPU, NIC, or storage client.
Controlled repetition is what turns a plausible correlation into evidence. Avoid changing NCCL variables, drivers, topology, and workload settings in the same run; you will not know which change mattered.

2. Align telemetry to each affected step
Overlay step time or throughput with GPU clocks, power, temperature, health events, collective duration, input wait, NIC counters, and storage latency. Look for a change that begins before or at the slowdown and ends when the workload recovers. A metric that is merely high for the entire run is a context clue, not proof of causation.
Compare affected and unaffected devices during the same interval. A cluster-wide metric can hide one throttled GPU; a per-GPU metric can look abnormal simply because that rank has a different role. Keep rank, GPU, NIC, and node identifiers in the trace.
3. Check GPU compute and health first when an outlier appears
Use DCGM health monitoring to inspect device state, memory and data-path errors, clocks, throughput consistency, power, and thermal events. Then use an appropriate DCGM diagnostic suite to exercise the suspected path. Current DCGM diagnostics include tests for compute and framebuffer correctness, memory bandwidth, PCIe and peer bandwidth, targeted stress and power, and NVLink or PCIe copy paths.
Interpret results by comparison: test equivalent GPUs under equivalent conditions and compare the measured result with the installed hardware’s expected baseline. A diagnostic result does not prove that the application is configured correctly, and a published cross-GPU number is not a universal application-performance threshold.
Passive monitoring and active tests answer different questions. DCGM documentation cautions that diagnostics can consume GPU compute, memory, PCIe, NVLink, CPU, power, and cooling capacity. Schedule them on suitable GPUs or drained nodes, and warn users that an active test can disturb neighboring workloads.

A communication slowdown can be inside one node or between nodes. Inspect the topology exposed to the process and verify that the intended peer and NIC paths are available. Check peer-to-peer access, GPU Direct RDMA support, the availability of nvidia-peermem or DMA-BUF support as appropriate to the deployment, IOMMU behavior, PCIe Access Control Services, and any virtualized topology. These settings are platform- and deployment-dependent; have the cluster or platform administrator validate changes.

Use nvbandwidth or nvloom for GPU memory and GPU communication measurements. Test the pairs and directions that the job actually uses. If only one GPU pair is slow, a node-local path or topology issue is more likely than a general fabric problem. If every pair within a node is healthy but cross-node collectives stall, move the hypothesis to the GPU-to-NIC or fabric path.
5. Separate fabric performance from NCCL performance
First measure the network without the application’s collective algorithm. NVIDIA’s performance guidance identifies ib_write_bw for fabric bandwidth and ib_write_lat for fabric latency. Run these tests along the same hosts, interfaces, and paths used by the job, under a controlled traffic level. Record message size, direction, concurrency, and whether the result is host-to-host or GPU-associated.
Then compare those results with NCCL collective timing. If fabric and GPU communication tests meet the expected baseline for the actual hardware and topology but NCCL remains slow, investigate NCCL configuration, rank mapping, CPU affinity, GPU affinity, interface selection, and collective choice. The expected baseline is system-specific; do not substitute a universal bandwidth or latency number.
Do these 3 things before closing this tab:
1Repair Windows errors before they cause bigger problems2Scan for outdated or missing drivers - takes under a minute3Clear out junk files and repair common Windows errorsNCCL’s troubleshooting structure separates GPU, networking, runtime or MPI, performance and tuning, logging, and reliability areas. Use that structure after basic path checks, not instead of them. Tuning environment variables before verifying interface choice and topology can mask the fault and make later comparisons harder.
6. Test storage and data delivery in the workload’s own pattern
Treat an empty input queue, rising data-loader wait, or a recurring pause at batch boundaries as a storage hypothesis. Correlate the wait with storage-side request latency, queue depth, throughput, metadata operations, client CPU, and network traffic. Check whether the data was cached, whether the pause occurs during reads, metadata lookup, checkpoint access, or another phase, and whether all clients see it.
There is no workload-independent storage threshold that proves a training job is or is not storage-bound. Before selecting a benchmark, document:

- Data layout, file sizes, sharding, compression, and cache state.
- Request size, read pattern, concurrency, and number of workers.

Benchmark that pattern, then compare it with the workload’s required delivery rate and latency. One sequential-bandwidth result is not evidence that a random, many-worker training input is healthy.

7. Determine whether power or temperature constrained the GPU
Align GPU temperature, clock frequency, board power, and throttle or health events with the exact slow steps. A power or thermal hypothesis is stronger when clocks fall at the same time that a configured power or temperature constraint appears, then recover when the constraint clears. Compare the affected GPU with equivalent GPUs running the same phase.
DCGM’s targeted-power test sustains a compute load and checks whether the GPU reaches a configured board-power threshold. Interpret it carefully: a competing workload can interfere, and an enforced power limit below the target can prevent a meaningful result. Treat that lower limit as a configuration constraint, not as proof that the hardware is defective.
GPU-level evidence cannot establish rack, room, or facility capacity. For those conclusions, use the site’s electrical telemetry, rack limits, cooling-system readings, inlet and exhaust temperatures, and documented design alarms. This guide cannot supply a universal facility power or cooling threshold because those limits depend on the installation.
Choose tests that distinguish competing explanations
| Question | Controlled test | Interpretation |
|---|---|---|
| Is the GPU itself an outlier? | Equivalent DCGM health and diagnostic tests on affected and unaffected GPUs. | An outlier result supports a device, bus, or local-path hypothesis; matching results shift attention to application or shared infrastructure. |
| Is GPU memory or peer communication limiting progress? | nvbandwidth or nvloom on the relevant memory and GPU pairs. |
Low path performance with matching workload waits narrows the fault to the node-local path. |
| Is the inter-node fabric slow? | ib_write_bw and ib_write_lat between the job’s hosts and interfaces. |
Weak bandwidth or high latency supports a fabric, interface, or path issue; healthy results require checking NCCL and affinity. |
| Is NCCL configuration or rank mapping inefficient? | Run NCCL collectives with the production rank count and compare timing after GPU and fabric baselines pass. | Slow collectives with healthy isolated paths point toward configuration, affinity, algorithm, runtime, or placement. |
| Is power or thermal behavior limiting clocks? | Correlate production telemetry, then schedule a targeted-power or thermal diagnostic on isolated resources. | Use the result with enforced limits and site telemetry; do not infer facility adequacy from one GPU test. |
| Is data delivery limiting the input pipeline? | Replay the workload’s access pattern with documented cache, request-size, and concurrency conditions. | Compare delivery latency and queue behavior with the application’s input waits, rather than relying on sequential bandwidth. |
Confirm before changing production
Repeat the suspected failure under the same conditions and then alter one variable that should remove it. Examples include moving the job away from one node, using a different GPU/NIC pairing, restoring the intended power policy, or staging a controlled data subset locally. A successful change is evidence only if the original symptom returns when the suspected condition is reintroduced or appears on a comparable affected peer.

When node-health evidence is strong, follow the cluster’s operational process to drain or isolate the node. Preserve telemetry, diagnostic output, topology information, and job identifiers for the hardware or platform team. Do not recommend replacing a component from a single warning, a transient temperature reading, or one failed active test that ran while another workload consumed the same resources.

Common diagnostic mistakes
Assuming low GPU utilization names the cause
Low utilization can result from input starvation, synchronization, communication, CPU scheduling, memory behavior, or a throttled clock. Pair utilization with clocks, communication timing, input wait, and health events.
Tuning NCCL before checking the path
Environment variables cannot repair a missing peer path, a wrong interface, a broken GPU Direct route, or a congested fabric. Establish GPU and fabric baselines first, then test configuration and affinity changes one at a time.
Using a passive health panel as a stress test
Field telemetry shows what happened during normal operation. It does not exercise every memory, PCIe, NVLink, power, or collective path. Active DCGM diagnostics add evidence but consume resources and must be scheduled deliberately.

Calling a GPU event a facility conclusion
A board-power limit or thermal event on one GPU does not reveal rack headroom, room airflow, or cooling-plant capacity. Use site electrical and cooling telemetry and the installation’s design limits for those decisions.
