Reliable few-shot accuracy requires more than counting correct answers from one prompt. Freeze the evaluation boundary before the final test, keep support, tuning, and query data disjoint, repeat the test across independently sampled episodes and prompt seeds, and record every choice that can affect a prediction. Then add controls for label names, answer positions, demonstration order, explanations, and distribution shifts. If accuracy changes substantially under those controls, the original score measured prompt artifacts or leaked information as well as task performance.

This guide gives a reproducible protocol for measuring few-shot classification and an audit process for discovering label leakage before a result is used in production or compared with another model.

Define what the accuracy claim means

“Few-shot accuracy” is not a single universal quantity. It depends on the number of classes shown in an episode, the number of demonstrations per class, how classes are sampled, the prompt template, the label vocabulary, the decoding rule, and the population represented by the query examples. Write those choices down before running the final test. A score without them cannot be reproduced or interpreted fairly.

Separate support, tuning, and query data

Use three logically separate pools:

  • Support examples: the labelled demonstrations placed in a model prompt for an episode.
  • Tuning examples: data used to select a prompt template, threshold, model, preprocessing rule, retrieval policy, or decoding strategy.
  • Query examples: the final evaluation cases whose labels are used only to calculate the reported result.

Keep the pools disjoint by example ID. Do not let query text, query labels, retrieval hits, preprocessing statistics, or error analysis from the final set influence a decision about the prompt, threshold, demonstrations, or model. This rule includes indirect paths: computing a vocabulary from all records, choosing a truncation length after looking at test failures, or adding a demonstration because a particular query was difficult are all forms of test contamination.

Specify the episode

For each evaluation, declare an N-way/K-shot design. N is the number of classes in an episode; K is the number of labelled demonstrations per class. State whether classes are sampled uniformly, weighted by their population, or fixed by a benchmark. Also state whether every class contributes the same number of query examples. These decisions determine the estimand: an average over classes, an average over naturally occurring examples, or something else.

Make sampling and prompting reproducible

A single favorable episode is not a reliable estimate. Sample many episodes and vary the random seed used for class selection, support selection, query selection, and any retrieval step. Record the complete configuration for every run.

Minimum run record

  • N-way and K-shot values, class-sampling rule, and the total number of episodes.
  • Random seeds for episode construction, prompt generation, retrieval, and any data shuffling.
  • Model name and version identifier, inference parameters, context limits, and date of evaluation.
  • Exact prompt template, demonstration order, label map, and output-format instructions.
  • Decoding method, allowed output tokens, parsing rules, and temperature or equivalent sampling settings.
  • Number of retries and the rule used when a response is malformed or empty.

Store the rendered prompt for each episode, not only a template. A later change in whitespace, ordering, label spelling, or truncation can change the result even when the nominal experiment is unchanged.

Use a fixed retry policy

Retries can silently improve a score if they are triggered only on difficult cases. Define in advance whether an invalid response counts as incorrect, whether one retry is permitted, and whether the retry uses the same or a new random seed. Report the number of invalid outputs and retries separately from ordinary accuracy.

Report a set of metrics, not one headline number

Start with the basic quantity:

accuracy = number of correctly classified query examples / total number of query examples

That ratio is useful, but it can conceal imbalance, unstable episodes, or systematic confusion between related classes.

Metric What to calculate Why it matters Important qualification
Overall accuracy Correct predictions divided by all query examples Simple aggregate performance Can be dominated by classes with more examples
Per-class accuracy Correct predictions within each class Shows which labels fail Small classes have wide uncertainty
Macro average Average of per-class accuracies Gives each class equal weight when balance is uneven May not represent the frequency seen in deployment
Episode mean and spread Accuracy for each episode, then mean and standard error or confidence interval Shows sensitivity to support and class sampling State the episode count and sampling rule
Confusion matrix Counts or rates for every true/predicted pair Reveals systematic confusion between semantically related labels Interpret alongside class definitions and granularity

Quantify uncertainty over repeated episodes

Report the full number of episodes and query examples, the mean episode accuracy, and a confidence interval or standard error calculated over the repeated episodes. Also give the pooled example-level accuracy so readers can distinguish “typical episode” performance from the result obtained by pooling all queries. Do not present more decimal places than the number of examples and episodes justify.

Inspect the confusion structure

Include a confusion matrix when labels are semantically related, hierarchical, or easily mistaken. A high overall score can coexist with failure on one clinically, legally, or operationally important pair. Per-class and pairwise results make that risk visible.

Prevent leakage from labels and answer positions

Models can exploit the representation of a task rather than infer its underlying rule. Label-token and position controls are therefore part of the measurement, not optional cosmetic checks.

Permute label names

Run equivalent episodes with randomly assigned label tokens or with several independent label maps. Preserve the underlying class and example content while changing only the mapping from class to output token. Compare both the mean and the variance of accuracy across mappings. A large change indicates dependence on familiar words, token frequency, spelling, or an accidental association between a label and a class.

Permute answer positions

For multiple-choice or ordered-label outputs, rotate which answer position corresponds to each class. Balance positions across episodes so that every class appears equally often in every position. If predictions change when the correct answer moves from, for example, the first position to the third, the score includes a position bias.

The ABCD study by Mateusz Nowak, Xavier Cadet, and Peter Chin, published in 2026, examines label-position and few-shot-prompt biases in multiple-choice evaluation. Its bias-reduced answer-permutation protocol produced a threefold reduction in mean accuracy variance in the reported experiments, with only a minimal decrease in mean performance. Treat that figure as a result of that study’s protocol and experiments, not as a universal correction factor.

Balance demonstration order

Construct matched prompts in which the same demonstrations appear in different orders. Randomize order across episodes and report the spread. Large order effects suggest recency, primacy, or formatting sensitivity rather than stable task learning.

Use semantically equivalent output formats

When possible, compare a symbolic label map with a natural-language label map and with an explicit answer schema. Keep the class definitions and examples fixed. If a model performs well only when labels are meaningful words, it may be using lexical shortcuts; if it fails only with symbols, the parser or decoding instruction may be the problem.

Audit explanations and auxiliary signals

Rationales, retrieval results, feature attributions, and confidence scores can introduce a second leakage channel. If an explanation method is class-dependent, it may encode the selected class in the explanation itself. Jethani, Saporta, and Ranganath’s AISTATS 2023 work demonstrates how class-dependent explanation methods can leak information and create misleadingly favorable interpretations.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Run label-agnostic controls

Generate or evaluate explanations without exposing the target label, then test whether an independent classifier can recover that label from the explanation alone. If it can, the explanation is not an independent justification. For retrieval-augmented systems, verify that the retrieval index excludes query labels and near-duplicate records, and compare against a control that retrieves from label-neutral metadata only.

Separate prediction from explanation scoring

Do not award prediction credit because a rationale contains the expected label or because an attribution method highlights a class-specific field. Score the classification output with a strict parser, and evaluate explanation quality with separate, predeclared criteria. Keep the explanation text out of any prompt or post-processing step that determines the predicted label unless that use is part of the declared model.

Test robustness under distribution change

In-distribution accuracy answers only whether the model worked on examples drawn like the benchmark. Deployment often changes the domain, time period, demographics, writing style, or nuisance context. Measure the degradation under shifts that are plausible for your application.

Useful shift slices

  • Cross-domain: train or select prompts on one source and query on another source with the same label definition.
  • Temporal: evaluate later time windows to expose vocabulary and policy drift.
  • Demographic: compare predefined demographic slices where collection and privacy rules permit it.
  • Nuisance-context: alter formatting, background, channel, author style, image conditions, or other variables that should not change the label.
  • Spurious-correlation: break a shortcut that is predictive in the benchmark but irrelevant to the intended task.

Report accuracy on each shift and the absolute degradation from the in-distribution reference. A model with a lower headline score but a smaller, predictable degradation may be safer than a model that wins only on the benchmark distribution.

Use shift-focused benchmarks as design references

MetaCoCo, introduced at ICLR 2024, targets spurious-correlation shifts in few-shot classification and reports significant degradation of existing methods under those shifts. FewSTAB, presented at ECCV 2024, provides a systematic framework for quantifying robustness to spurious bias in few-shot image classifiers. These benchmarks are useful reminders to measure the shift itself instead of assuming that ordinary few-shot accuracy implies robustness.

Check whether the benchmark resembles deployment

Benchmark composition changes the difficulty of a few-shot task. Document the number of classes, semantic similarity among classes, label granularity, and way count before comparing scores.

Class semantics and granularity

Semantically distant classes can make classification easier than a deployment in which neighboring categories differ by a subtle rule. Conversely, very fine-grained labels may require expertise or information absent from the demonstrations. State whether labels are broad topics, fine subtypes, hierarchical nodes, or operational decisions.

Way count and task construction

Increasing the number of classes generally increases the number of plausible alternatives, but the effect depends on class similarity. A two-way task with nearly identical categories can be harder than a many-way task with unrelated categories. The CVPR Workshops analysis by Bennequin and colleagues (2022) argues that common benchmark task composition can be too distant from industrial use and proposes semantic task sampling and many-way settings. Use its lesson operationally: describe the semantic distance and way count instead of generalizing a benchmark score to all deployments.

  1. Write the estimand. Define the population of interest, label set, episode structure, and whether you will report pooled, macro, or episode-mean results.
  2. Create immutable manifests. Assign stable IDs to support, tuning, and query records. Store the split manifest under version control or equivalent access control.
  3. Freeze preprocessing. Fit tokenization rules, normalization, feature statistics, and filters using only permitted data. Record the code and configuration version.
  4. Select the model and prompt policy on tuning data. Choose templates, demonstrations, thresholds, retrieval rules, and decoding settings without opening the final query labels.
  5. Generate episode plans. Sample classes and support/query IDs from the frozen pools using recorded seeds. Save each plan before inference.
  6. Render and save prompts. Store the exact text, label map, demonstration order, system instructions, and truncation decisions for every episode.
  7. Run inference with a fixed retry rule. Record raw responses, parser outputs, invalid responses, retries, and model/version identifiers.
  8. Score automatically. Use a versioned scoring script that maps only allowed outputs to labels. Preserve both example-level predictions and episode-level summaries.
  9. Run artifact controls. Repeat matched episodes with label permutations, answer-position permutations, balanced demonstration orders, and equivalent output names.
  10. Run shift controls. Evaluate the predeclared cross-domain, temporal, demographic, nuisance-context, or spurious-correlation slices relevant to deployment.
  11. Audit auxiliary signals. Test explanations, retrieval, confidence, and feature attributions for class information that should not be available to them.
  12. Publish the result with uncertainty. Include overall and per-class metrics, macro averages, confusion matrices where appropriate, episode counts, confidence intervals or standard errors, and every material deviation from the plan.

Interpret changes between controls

Controls are useful only if their differences are interpreted rather than hidden in an appendix.

Observed change Likely concern Next diagnostic
Large accuracy change after label permutation Lexical label association or token-frequency shortcut Use multiple random maps and inspect per-class variance
Large change after answer-position rotation Position or option-order bias Balance positions and compare a position-neutral output format
Large spread across demonstration orders Primacy, recency, or prompt-format sensitivity Increase order replicates and report order-conditioned results
High in-distribution score, sharp shift degradation Spurious correlation or benchmark mismatch Identify the changing nuisance variable and collect matched counterexamples
Explanation predicts the selected class Label leakage through the explanation method Regenerate explanations without target-label access and test again
Different scores from pooled and macro averages Class imbalance Report both and explain which matches deployment prevalence

Keep an auditable release package

An evaluation should be reproducible without trusting the original author’s memory. Release, or retain securely when data cannot be public, the following:

  • Split manifests and stable support/query IDs.
  • Episode definitions, class-sampling rules, and all random seeds.
  • Prompt templates, rendered prompts where permitted, label permutations, and demonstration orders.
  • Model and preprocessing version identifiers, inference settings, and retry policy.
  • Raw responses, parser logs, invalid-output counts, and final predictions.
  • The exact scoring script and the code that creates confidence intervals or standard errors.
  • Shift-slice definitions and the mapping from each query to its slice.
  • Documentation of exclusions, duplicates, near-duplicates, and any records removed after the split was frozen.

This trail lets another evaluator reconstruct the boundary, verify that query information did not influence tuning, and locate the source of a disagreement.

What established benchmark work contributes

Several benchmark efforts provide principles rather than a universal score conversion.

  • CLUES (Microsoft Research, 2021): proposes a benchmark for few-shot natural-language understanding and discusses principles for a unified, standardized evaluation approach. Its publication page is dated November 29, 2021.
  • VTAB+MD (Google Research, NeurIPS Datasets and Benchmarks Track, 2021): introduces a protocol intended to make transfer-learning and meta-learning results more directly comparable across benchmark families.
  • MetaCoCo (ICLR 2024): focuses on spurious-correlation shifts in few-shot classification.
  • FewSTAB (ECCV 2024): provides a framework for measuring robustness to spurious bias in few-shot image classifiers.
  • Bennequin et al. (CVPR Workshops, 2022): examine semantic task sampling and many-way settings as remedies for unrealistic benchmark composition.
  • ABCD (ICML 2026): studies label-position and few-shot-prompt bias in multiple-choice evaluation and reports the threefold reduction in mean accuracy variance under its permutation protocol.
  • Jethani, Saporta, and Ranganath (AISTATS 2023): demonstrate leakage in class-dependent explanation methods and motivate quantitative checks.

Use these works to choose controls that match your failure modes. None removes the need to document your own splits, episodes, labels, and deployment shifts.

A practical decision rule

Do not treat a few-shot result as deployment evidence until four conditions hold: the query boundary was locked before testing; performance is stable enough across episodes and prompt seeds to report uncertainty; artifact controls do not materially change the conclusion; and the benchmark includes shifts and class semantics that resemble the intended use. If one condition fails, report the failure explicitly and narrow the claim rather than presenting the unadjusted accuracy as general task understanding.
