The defensible way to estimate large-scale AI inference cost is to start with a measured production workload, not a model’s advertised price. Define one successful product task, measure its input and output tokens, cache use, tools, concurrency, and latency target, then price the same workload across metered APIs, provisioned capacity, and self-hosted GPUs. Report monthly spend and cost per successful task, with low, base, and high cases for traffic and utilization.

What an inference cost estimate must answer

A useful estimate answers more than “How many tokens will we send?” It should show:

  • What product event is being served, such as one answered customer request or one completed document extraction.
  • What quality threshold makes that event successful.
  • How many requests arrive in each time interval, including peaks and long-tail bursts.
  • How input, output, cached, multimodal, and tool-generated tokens are billed or converted into capacity.
  • What latency, availability, data-residency, and redundancy requirements the service must meet.
  • What capacity sits idle during quiet periods and what happens when demand exceeds the forecast.

There is no generally applicable dollar-per-inference benchmark. A token-metered API bill depends on the selected model and billing categories. A self-hosted bill depends on measured throughput, instance type, region, utilization, and the complete machine and operations stack. Provider list prices are useful inputs to a model; they are not a universal measure of a provider’s internal inference cost.

Step 1: Define the unit of useful work

Choose a product event

Use a unit that finance and engineering can both recognize. “One request” is often too vague because requests may have very different context lengths, tool calls, or success criteria. Better units include:

  • One customer question answered with a grounded citation.
  • One support case classified and routed.
  • One document processed and validated against a schema.
  • One voice turn completed within the stated response-time target.

Record the minimum acceptable result for that event. For example, a response may count only if it passes a factuality check, returns valid JSON, and arrives within the product’s p95 latency target. Cost per request without a success definition can reward a cheap system that fails more often.

Freeze the comparison

When comparing models or deployment modes, hold the following constant wherever possible:

  • Model capability and version, or a documented quality-equivalent alternative.
  • System and developer instructions.
  • Retrieval context and tool sequence.
  • Maximum context and output limits.
  • Sampling settings and safety policy.
  • Quality test, timeout, retry, and fallback behavior.

If a candidate needs a longer prompt, more retries, or an additional verification call to reach the same quality, those tokens and calls belong in its cost. Comparing only the first model invocation understates the real cost of a successful task.

Step 2: Measure the workload instead of averaging it

Capture distributions, not one average

Export representative production traces or run a load test that matches production behavior. At minimum, group observations by a short interval such as one minute or five minutes and retain:

  • Requests per interval and the peak-to-average ratio.
  • Input-token and output-token distributions, including p50, p90, p95, and p99.
  • Prompt-cache hit rate and the number of tokens served from cache.
  • Tool calls, retrieval calls, image or audio inputs, and other separately billed modalities.
  • Concurrent requests, queue time, time to first token, and total response time.
  • Retries, fallbacks, cancellations, and requests that fail the quality or latency target.
  • Geographic routing and any residency requirement.

Averages hide the two things that usually determine capacity: long contexts and short-lived bursts. A system with a modest daily average may still require enough instances or provisioned units to handle its busiest five-minute window.

Separate interactive and batch traffic

Interactive traffic is constrained by user-facing latency and usually needs headroom for bursts. Batch traffic can often be scheduled into quieter periods and may qualify for different pricing. Keep the two streams separate in the model rather than blending them into one hourly average. Bedrock documentation, for example, describes lower batch pricing for selected models; eligibility and rates are model-specific and can change.

Build a trace-to-spreadsheet schema

A practical row represents one time interval and contains:

Field Why it matters
Timestamp and region Preserves peaks, routing, and residency effects.
Request count and concurrency Determines throughput and required headroom.
Input, cached-input, and output tokens Maps to separate API prices or capacity weights.
Tool and modality counts Captures charges outside ordinary text tokens.
Latency percentiles and errors Tests whether the deployment meets its service target.
Success result Enables cost per successful task instead of cost per attempt.

Step 3: Calculate metered API spend

Use one formula per billing category

For each model and endpoint, calculate the period bill as:

API spend = input tokens × input rate + cached input tokens × cached-input rate + output tokens × output rate + tool or modality units × applicable rate.

Use the provider’s current rate card for the exact model, region, endpoint, and billing period. Do not multiply total tokens by a blended “cost per token” unless the blend is built from the measured category volumes. Keep input and output volumes separate because output rates are commonly higher and because the same tokens can consume provisioned capacity differently.

Include retries and fallback paths

If 3% of calls retry once, the expected billed volume is not the initial volume; it includes the extra calls and their tokens. A fallback model, moderation pass, retrieval query, or summarization step is also part of the successful-task cost. Make each stage a separate line so that a change in workflow is visible.

Check the pricing dimensions that change the bill

Dimension What to verify Why a simple token estimate fails
Input versus output Separate current rates and any minimum billable unit. Generated tokens may cost more than prompt tokens.
Cached input Discount, eligibility window, and whether cached tokens still consume capacity. A cache hit can reduce price but may not reduce every capacity charge.
Tools and modalities Image, audio, retrieval, code execution, and other line items. These can be billed outside text-token rates.
Batch mode Model eligibility, submission limits, and current batch rate. Interactive and batch prices are not interchangeable.
Geography Regional endpoint, processing location, and premium. Residency requirements can add a surcharge.
Negotiated terms Only signed or confirmed discounts and commitments. Assumed discounts make a budget look cheaper than the contract.

Geographic premiums need model-specific validation

Anthropic’s current pricing documentation states a 10% premium for covered regional or multi-region endpoints compared with global endpoints, for the documented Claude 4.5-and-later scope. OpenAI’s current pricing documentation states a 10% regional-processing uplift for eligible models released on or after March 5, 2026. These figures apply only within the stated model and endpoint scopes; verify the selected deployment before applying them.

Step 4: Size managed provisioned throughput

Provisioned services charge for reserved capacity rather than simply for the tokens that happened to arrive. The process is:

  1. Convert the measured input, output, cached, and modality mix into the provider’s model-specific throughput units.
  2. Apply the busiest required interval, not the daily average, and add the headroom required by the latency SLO.
  3. Round up to the service’s minimum deployment and increment.
  4. Multiply capacity units by the hourly rate, commitment duration, region, and any required replicas.
  5. Model the cost of unused capacity when traffic is below the reservation.

Azure PTU accounting example

Microsoft’s Azure provisioned-throughput guidance says output tokens consume capacity differently from input tokens and that required PTUs are rounded to a deployment increment or minimum. Its documented GPT-5 example counts one output token as eight input tokens toward utilization, reflecting that model’s global standard price ratio. That ratio is specific to the documented model and should not be reused for another model.

Google capacity-unit example

Google Cloud’s worked example for Gemini 3.6 Flash uses 10 requests per second, 1,000 text input tokens, 500 audio input tokens, and 300 text output tokens per request. Its documented burndown produces 3,000 adjusted tokens per query and 30,000 adjusted tokens per second. This illustrates the arithmetic for a particular model and modality mix; it is not a cost quote or a general traffic profile.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Caching can alter capacity as well as price

For the documented Gemini 2.5 Pro example, Google Cloud assigns 100 throughput tokens per second to 1,000 cached input text tokens, versus 1,000 throughput tokens for 1,000 uncached input tokens. That 0.1 factor is an example for that named model, not a universal caching rule. Check whether your provider discounts cached tokens, reduces their capacity weight, or does both.

Step 5: Estimate a self-hosted GPU deployment

Benchmark the actual serving configuration

Measure the selected model with the intended quantization, runtime, batching policy, context lengths, concurrency, and latency target. Record sustained tokens per second and completed successful tasks per second. A GPU’s theoretical peak throughput is not a budget number: memory pressure, synchronization, long contexts, queueing, and quality-preserving settings can reduce observed throughput.

Calculate required instances

A simple sizing equation is:

Required instances = ceiling(peak required throughput ÷ measured sustainable throughput per instance).

Use the peak interval and reserve capacity for failures, rolling deployments, and maintenance. If two replicas are required for availability, include both even when one would cover the average load. If the model does not fit in one accelerator, include the communication and placement constraints of a multi-GPU instance in the benchmark.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Include the complete infrastructure bill

  • Accelerator or GPU instance hours.
  • VM CPU, memory, attached storage, and operating-system charges.
  • Inter-zone or inter-region networking and ingress or egress where applicable.
  • Load balancers, queues, logs, metrics, tracing, and artifact storage.
  • Redundant replicas, staging capacity, and replacement or failover capacity.
  • Engineering and on-call effort for upgrades, security, tuning, and incident response.

Google Cloud explicitly notes that GPU charges are additional to machine-type costs and vary by region and zone. AWS lists accelerated compute, networking, and storage as infrastructure considerations. AWS also recommends: “Keep refining your deployment to maximize utilization of underlying resources by continuously evaluating models for accuracy, latency, and cost.” Treat utilization as an operating metric, not an assumption.

Account for commitments and idle time

Reservations or committed-use discounts can reduce the hourly rate when the workload is stable, but they increase exposure when demand falls. Model the committed and on-demand portions separately. A deployment that is cheaper at 90% utilization may be more expensive than an API at 20% utilization because the GPUs remain online while traffic is low.

How many GPUs do you need for inference?

There is no answer from request count alone. GPU count depends on model memory, context length, batch size, decoding speed, concurrency, and the required latency percentile. Use this sequence:

  1. Define the peak requests per second and token distribution.
  2. Set the maximum queue time and p95 or p99 response target.
  3. Benchmark one instance under the exact model and serving configuration.
  4. Measure sustainable throughput at the concurrency that meets the latency target.
  5. Divide peak demand by that measured throughput and round up.
  6. Add replicas for availability and headroom for spikes, deploys, and failures.
  7. Re-run the benchmark after changing quantization, batching, context limits, or hardware.

For example, if a benchmark sustains 40 successful tasks per second at the required p95 latency and peak demand is 95 tasks per second, the arithmetic requires three serving units before redundancy. Whether each unit is one GPU or a multi-GPU host is determined by the model’s memory and parallelism requirements, not by the request count.

Build low, base, and high scenarios

At minimum, vary the assumptions that are usually uncertain:

  • Traffic volume and peak-to-average ratio.
  • Input and output token percentiles.
  • Cache hit rate.
  • Tool or multimodal share.
  • Measured serving throughput.
  • Retry and failure rate.
  • Required redundancy and regional routing.

Label each assumption with its source: production trace, load test, contract, or explicit planning judgment. Keep the scenarios in separate columns so a decision-maker can see whether the result is driven by traffic, price, utilization, or quality.

Example of the arithmetic without inventing a price

Suppose a month contains R requests, with I input tokens, C cached input tokens, and O output tokens per request. If the confirmed rates are p_i, p_c, and p_o, then:

Monthly token spend = R × (I × p_i + C × p_c + O × p_o).

Add R × retry_rate expected retry requests and the measured tokens for every fallback or tool stage. For provisioned capacity, replace token prices with the model’s adjusted throughput calculation, round to the provider’s minimum and increment, and multiply by the number of billed hours. For self-hosting, multiply the required instance count by the hourly GPU-plus-VM cost and add the non-accelerator line items. This preserves the structure of the estimate without pretending that one provider’s rates apply to another.

Convert monthly spend into cost per successful task

Use:

Cost per successful task = (inference spend + allocated infrastructure and operations) ÷ number of tasks that meet the quality and service criteria.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Count unsuccessful attempts in the numerator because they consumed resources. If a system completes 1 million attempts but only 950,000 satisfy the success test, divide by 950,000, not 1 million. Keep fixed platform costs visible rather than hiding them in a token rate; this makes scale and utilization effects easier to explain.

A practical decision framework

  1. Start with a metered API when demand is uncertain, highly spiky, or operational staffing is limited.
  2. Evaluate batch processing when work can wait and the selected model qualifies for batch pricing.
  3. Consider provisioned capacity when traffic is steady enough to keep the minimum deployment busy and predictable latency is valuable.
  4. Consider self-hosting when you can benchmark sustained utilization, need model or residency control, and can operate redundant serving infrastructure.
  5. Revisit the choice whenever the model, prompt, context distribution, region, quality target, or traffic shape changes.

The right answer can be hybrid: interactive requests on elastic capacity, scheduled jobs in batch, and a reserved or self-hosted pool for a stable high-volume path. Compare the blended design against an all-API and all-self-hosted baseline using the same success criteria.

What to put in the final finance model

  • Workload definition and quality test.
  • Trace period, traffic forecast, and peak-to-average assumption.
  • Token, cache, tool, and modality distributions.
  • Model and endpoint versions, regions, and residency constraints.
  • Current confirmed rates, minimums, increments, and commitment terms.
  • Benchmark throughput at required context, concurrency, and latency.
  • GPU, VM, networking, storage, observability, and operations costs.
  • Low, base, and high scenarios with clearly labeled assumptions.
  • Monthly total, cost per successful task, utilization, headroom, and failure exposure.
