There is no reliable universal storage number for an AI data lake. Estimate capacity from the data you expect to ingest, how long you will retain it, which raw and processed layers you will keep, and the copies created by backup, replication, and versioning. Then size training scratch space and checkpoints separately: those can have much shorter lifetimes and higher performance requirements than the durable lake.

A useful first-pass equation is durable capacity = retained raw data + retained transformed data + retained curated data + retained versions + backups and replicas + material metadata and logs. Calculate each term from your own ingest and policies, rather than applying one multiplier to the whole lake.

What determines an AI data lake’s storage requirement?

The main capacity driver is not that data is used for AI; it is how much data arrives, how long it remains, and how many retained copies or representations your architecture creates. A lake holding images, video, audio, text, tabular records, logs, and model artifacts may have very different growth and processing patterns for each source.

Separate durable capacity—data intended to persist in the lake—from workload capacity, such as a training cache, temporary staging area, or checkpoints. Durable capacity is shaped by retention, format, and resilience policies. Workload capacity is shaped by job concurrency, data access, repeated training passes, checkpoint size and frequency, and how quickly temporary data can be removed.

Cloud storage guidance from Google Cloud and AWS emphasizes planning around current and forecast capacity, retention, workload, resilience, and access requirements. Those inputs are what make an estimate useful; without them, a single number would be guesswork.

Build an inventory of data sources and growth

Start with one row per source or dataset, not one total for the entire platform. This makes it possible to apply the right growth, retention, transformation, and access assumptions to each category. Include training data and artifacts, but also operational data that the lake will retain.

  • Data type: identify whether the source is tabular data, text, images, audio, video, logs, model artifacts, or another format.
  • Current footprint: record the stored size now, ideally from observed object or storage metrics.
  • Arrival rate: measure daily or monthly ingest. For streaming data, use actual sustained and peak rates where available; for batch data, record the size and cadence of each load.
  • Growth assumption: state how the arrival rate is expected to change and over what planning horizon. Use observed trends where possible, and make the low, expected, and high assumptions explicit.
  • Retention: specify how long the original dataset remains available and whether retention differs by source, age, or purpose.
  • Processing and access: note whether jobs repeatedly read the data, create additional retained outputs, or need a cache or staging copy.

For a stable ingest rate, a basic estimate for one dataset is:

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

retained source data = daily ingest × retention days

Use consistent units throughout—for example, daily ingest and retention both expressed in days, with all sizes in the same byte unit. If ingest grows, calculate expected arrivals over the planning period rather than multiplying today’s rate across every future day. For a month-by-month forecast, add the expected arrivals in each month and apply that dataset’s retention rule to determine which arrivals are still present at the forecast date.

Do not treat a vendor’s generic example as a substitute for measurements from your own sources. If current data is already compressed or stored in a particular format, record the size of that representation, and distinguish it from the size of any new output format.

Count only the lake layers and versions you retain

A common lake design separates raw, transformed, and curated data. AWS and Microsoft Azure describe these as distinct types of lake assets, while AWS also identifies logs as a separate bucket. These categories matter for sizing because a transformed or curated dataset may coexist with its source, but it does not necessarily duplicate every source byte.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Raw data

Raw data preserves the source as received. Teams may retain it so they can reprocess data when transformations change or investigate what was originally ingested. Estimate its capacity using ingest and its own retention period.

Transformed data

Transformation can change both format and size. Normalization, filtering, enrichment, deduplication, or conversion to a query-oriented format can make output smaller or larger than the input. Estimate a transformed-output ratio from a representative pilot: divide the size of the retained transformed output by the size of the corresponding input. Apply that measured ratio only to data processed in a comparable way.

Curated data

Curated datasets may contain enriched or business-ready outputs for analytics or model workflows. Include them as a separate retained layer only if the design keeps them. Their size depends on the selected outputs and transformation steps, so a measured ratio is more defensible than assuming another full copy of the raw data.

Versions and logs

Versioning can preserve earlier dataset states when data changes or is overwritten. Count the versions that the actual policy retains and the period for which it retains them. Logs and metadata also consume capacity; include them when material, especially if they accumulate over time or have their own retention requirements.

A practical accounting model is to calculate each retained layer independently:

  • Raw: source arrivals still within raw-data retention.
  • Transformed: the retained output for the portion of data processed and retained.
  • Curated: retained curated output, based on measured output size or an explicit estimate.
  • Versions: retained older states not already counted in the layer totals.
  • Logs and metadata: retained operational records and catalog information that materially affect capacity.

Make clear which values are actual measurements and which are assumptions. That prevents the same bytes from being counted twice—for example, once as transformed data and again as a full duplicate—even when the architecture stores only one representation.

Add backup, replication, and disaster-recovery capacity explicitly

Backup, replication, versioning, and disaster recovery are separate capacity terms, not a universal percentage to add to every lake estimate. Their impact depends on how the provider and organization configure them. A full copy, an incremental backup, a cross-region replica, and a version retained for a different period do not necessarily consume the same amount of storage.

Document each policy separately, including what it preserves, where it is stored, and how long it is retained. Check whether a policy covers all data or only selected datasets, and whether expiration or lifecycle rules remove copies as intended. Google Cloud’s storage guidance also highlights replication and consistency requirements as design questions; AWS’s generative-AI storage assessment calls attention to backup and dataset versioning.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.
  • Record backup scope, schedule, retention, and whether backups are full or incremental.
  • Record replica count or destination and whether replication crosses regions.
  • Record version-retention rules separately from backup rules, so overlapping copies are not automatically counted twice.
  • Include temporary staging, failed processing outputs, or retry artifacts only if they persist in the actual design.
  • Include logs and metadata when they are significant, rather than hiding them in an unexplained overhead percentage.

There is no single backup or replication multiplier established for all cloud configurations. Apply the policies you will actually use, then validate the resulting stored footprint against provider metrics in a pilot.

Estimate training, inference, and checkpoint storage separately

AI workloads can need fast working storage even when their durable dataset is much smaller. Training jobs may stage or cache data, read it repeatedly, and write checkpoints. Concurrent jobs can create multiple working copies or increase performance demand. Inference may use a shared dataset or maintain local/cache copies. Keep these workload terms separate from the long-term lake total and define how long each will persist.

For training jobs

  • Estimate dataset staging or cache capacity based on the data a job needs locally or concurrently, not simply the entire lake size.
  • Record checkpoint size and write frequency, then determine how many checkpoints are retained and for how long.
  • Account for the number of simultaneous jobs and whether each job has a separate copy or shares storage.
  • Measure repeated data passes and benchmark the throughput and I/O rate needed to keep the compute busy.

For inference workloads

Determine whether inference reads a shared dataset or keeps separate local or cached copies. Include only copies that the deployment actually maintains, and measure cache behavior under expected concurrency. The storage footprint may be modest while latency or throughput remains a constraint.

Google Cloud TPU workload Dataset estimate per TPU Checkpoint storage estimate per TPU
LLM pre-training 2 TB 200 GB
Multimodal training 12 TB 1 TB
Inference 1 TB 1 GB

These figures are published by Google Cloud; the publication year is not stated in the source result. Keep the TPU and workload context attached to them when using them as an initial reference. For your own system, confirm per-job and per-accelerator requirements with representative runs. A dataset-size estimate does not by itself establish the bandwidth, I/O rate, checkpoint window, or concurrency the workload needs.

Measure format and compression with representative data

Format and compression settings can change the stored footprint, but the result depends on the source data and configuration. Sample the actual data, write it in the target format and settings, and compare the resulting stored size. Include the effect of file organization and the format your processing and query engines will use; a smaller footprint is not the only relevant outcome if it changes how data can be accessed.

AWS describes Parquet as a columnar compressed format and reports an example in which 1 TB of CSV log data was represented as 130 GB in Parquet, an 87% space saving. That figure comes from an AWS 2021 example. AWS also reported query and scan improvements for that example, but neither the storage reduction nor the performance result is guaranteed for a different dataset, configuration, or engine.

Example Reported result How to use it
AWS 2021 CSV log data converted to Parquet 1 TB of CSV represented as 130 GB; 87% space saving Illustrative vendor example only; benchmark representative data in your own target format and settings

Do not apply the 87% saving to all data in a lake. Logs, images, video, audio, text, and tabular data can respond differently to compression and format changes. If a pilot processes only a sample, record the sample’s source, format, settings, and output ratio so the estimate can be applied only to comparable data.

Calculate scenarios rather than a single unsupported total

Once the inventory, retention, layers, and resilience policies are defined, build low, expected, and high cases. Change the assumptions that can materially affect capacity instead of applying one arbitrary safety factor. Useful scenario variables include ingest growth, retention duration, the proportion of data that becomes transformed or curated output, measured compression, version counts, backup behavior, and the number of simultaneous training jobs.

  1. Calculate retained arrivals by source. Forecast data arriving during the planning horizon and exclude arrivals that will have expired under that source’s retention policy.
  2. Calculate retained layers. Add raw, transformed, and curated outputs only where those representations are actually retained. Use measured output ratios where available.
  3. Add preserved history and resilience. Count versions, backups, and replicas according to their distinct policies, accounting for overlapping copies rather than assuming each is another full copy.
  4. Add material operational storage. Include logs, metadata, staging, or retry artifacts when they persist and affect the design.
  5. Calculate workload storage separately. Estimate concurrent staging/cache needs and checkpoint retention for training or inference jobs.
  6. Record the assumptions beside each total. Label measured inputs, forecast assumptions, and policy choices, and keep performance requirements alongside—not inside—the capacity number.

The result should be a range tied to explicit assumptions, not a precise-looking figure that conceals uncertainty. A high case might use faster growth, longer retention, or more retained copies; an expected case should reflect the plan the organization intends to operate. Recalculate when ingest trends, retention, storage policies, or model-training cadence change.

Validate the estimate with a pilot and storage metrics

A pilot turns the largest unknowns into measured inputs. Use representative data and the intended formats, transformations, and storage policies. Compare expected and observed bytes at each stage, then update the ratios used in the estimate.

  • Measure bytes ingested per source and the rate at which they arrive.
  • Measure raw-to-transformed and transformed-to-curated output sizes for representative datasets.
  • Check the stored footprint after versioning, backup, and replication policies take effect.
  • Observe cache use, concurrent reads, throughput, I/O rate, and checkpoint write behavior under representative jobs.
  • Verify lifecycle and expiration behavior so data intended to expire does not accumulate indefinitely.

Keep the durable-capacity forecast and performance forecast distinct. A lake can have adequate total capacity but still fail to deliver data quickly enough for training, or it can meet a training job’s throughput target while retaining more expensive working copies than intended. Revisit both estimates as production measurements replace initial assumptions.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Choose storage based on access and resilience, not capacity alone

When comparing storage options, assess how the workload uses data as well as how much it stores. Google Cloud’s storage strategy guidance frames selection around capacity and scaling, access, security, resilience, and performance; AWS lake guidance also describes lifecycle tiering for historical data that is retained but accessed infrequently.

  • Access frequency and retrieval latency: distinguish frequently read training or serving data from historical data kept mainly for retention.
  • Throughput and I/O rate: establish whether repeated reads and checkpoint writes meet the workload’s timing needs.
  • Durability, resilience, and consistency: align replication and recovery behavior with the data’s purpose and the organization’s recovery requirements.
  • Retention and lifecycle: assess how long data must remain available and whether infrequently accessed history can transition to an appropriate lower-access tier.
  • Security and geography: include encryption, access controls, and residency constraints in the decision.
  • Total cost under the expected access pattern: consider stored capacity together with retrieval and operational needs, not capacity in isolation.

Historical data that is rarely read may be a candidate for lifecycle tiering, but confirm retrieval behavior and policy consequences before relying on it for time-sensitive training or recovery. Likewise, a storage tier that appears inexpensive by capacity alone may not fit a workload that repeatedly reads large datasets or writes checkpoints on a tight schedule.

Use a repeatable capacity worksheet

A simple worksheet makes the estimate auditable and easy to revise. Maintain one record per source or retained dataset, then separate durable and workload totals.

  • Source and modality: dataset name and type.
  • Ingest: current footprint, daily or monthly arrival rate, and forecast growth assumption.
  • Retention: period for raw, transformed, and curated assets, with the date or horizon at which capacity is estimated.
  • Transformation: target format and measured output ratio from a representative sample.
  • History and resilience: version, backup, replica, and disaster-recovery policies, each described separately.
  • Operational data: material logs, metadata, staging, and retry artifacts.
  • AI workload: job concurrency, cache or staging footprint, checkpoint size and frequency, and checkpoint retention.
  • Performance: required throughput, I/O rate, and checkpoint completion window.
  • Evidence and uncertainty: distinguish measured values from assumptions and show low, expected, and high cases.

This worksheet does not need to produce one universal answer. Its purpose is to make the estimate traceable: each capacity term should map to an observed data rate, a retention decision, a measured transformation, or a documented resilience policy. That is what allows a platform team to update the estimate when the lake or its workloads change.
