Choose quantization settings by testing a supported model checkpoint on your actual runtime, hardware, and workload—not by picking the lowest bit width. Start with the model’s memory fit, leave room for context and KV cache, then compare task quality, latency, throughput, and peak memory across feasible options.

What to establish before choosing a format

Define the workload and limits

Write down the exact model and checkpoint, inference framework and version, GPU or CPU and usable memory, target context length, expected batch size or concurrency, and the task. Set a minimum acceptable quality level and latency. If your goal is adapter fine-tuning, distinguish training-time memory-saving approaches from quantization settings used for inference.

Check support before comparing quality

Compatibility can eliminate an option before benchmarking. Google Cloud’s serving documentation says that AWQ and GPTQ require pre-quantized models in the serving paths it describes, while EETQ and bitsandbytes can be applied without first obtaining a pre-quantized checkpoint. Its vLLM examples require pre-quantized models for the listed model-quantization options. Confirm the current support matrix for your actual framework and model rather than assuming a format label guarantees support: Google Cloud serving guidance.

Hugging Face’s selection guide suggests bitsandbytes when ease of use or QLoRA matters; GPTQModel or AWQ for calibrated 4-bit accuracy; HQQ or SINQ for on-the-fly quantization without calibration; and torchao where its integration and torch.compile suit the stack. Support and limitations are method- and ecosystem-specific, so treat this as a shortlist, not a universal ranking: Hugging Face Transformers quantization guide.

How to estimate memory without overcommitting VRAM

Bit width is a first approximation for weight storage, not a total runtime memory estimate. Hugging Face summarizes its benchmark comparisons as roughly 2× memory savings for 8-bit and 4× for 4-bit relative to bf16. These are approximate figures from its benchmark context, not guaranteed checkpoint file sizes or total VRAM requirements for every model.

Leave capacity for the KV cache, context length, activations, runtime buffers, batch size, and other processes. A model that loads successfully may still fail or slow down at the intended context or concurrency. Measure peak memory with those settings in place.

KV-cache quantization is separate from weight quantization. Google Cloud documents FP8 KV-cache quantization in its vLLM guidance as a way to reduce cache memory and potentially improve latency for large batches, while warning that inference accuracy can be reduced. Validate it separately, especially for long contexts and the batch sizes you expect.

If one GPU cannot hold the workload, tensor parallelism can distribute it across multiple GPUs. Whether that improves throughput or cost depends on the serving configuration; test the deployment you plan to run. A GPU choice is therefore a capacity and measured-performance decision, not a format-independent recommendation.

How to choose candidate bit widths

Begin with the unquantized or highest-precision baseline that fits, then compare supported 8-bit and 4-bit options. Investigate below 4-bit only when memory constraints justify the added quality risk. Hugging Face describes 4-bit methods in its comparison as retaining relatively high accuracy, while sub-4-bit results vary and can show noticeable degradation, especially at 2-bit. The amount of loss depends on the model and task.

Compare the same model and task wherever possible so that model size and quantization format are not confounded. If comparing different checkpoints is necessary, judge the actual candidates: a broad evaluation paper found that a larger quantized model often beat a smaller FP16 model across many studied benchmarks, with exceptions that included hallucination detection and instruction following. That result is study-specific, not a rule for every model or workload: evaluation study of quantized language models.

What each method family is suited to

Method What the guidance supports Check before adopting
bitsandbytes Hugging Face identifies it as an easy-to-use option and a common QLoRA path; its guidance does not require a separate inference calibration dataset. Confirm backend support and actual inference speed. Lower memory use does not guarantee faster inference.
GPTQ / GPTQModel Calibration-based approach; Hugging Face describes potential for high accuracy and inference speedups. Check pre-quantized checkpoint availability, calibration requirements, and serving-framework support.
AWQ Calibration-based approach; Hugging Face describes high accuracy at 4-bit and shorter calibration time than GPTQ in its guide. Check model and framework compatibility, then test on the target task.
HQQ / SINQ Hugging Face describes on-the-fly quantization without calibration. Read bit-width and backend caveats; the method name alone does not establish accuracy or speed.
FP8 KV cache Google Cloud documents support in its vLLM guidance and describes lower cache memory with a possible accuracy trade-off. Treat it as a cache setting, not a weight format, and test long-context and batch behavior.

Calibration effort can matter operationally. Hugging Face gives examples for an 8B model of about 20 minutes on one A100 for GPTQ and about 10 minutes on one A100 for AWQ. These are examples from its guide, not time guarantees for another model, machine, or workflow.

How to benchmark candidates fairly

  1. Fix the test conditions. Use the intended model, runtime, hardware, context length, batch or concurrency, and generation length. Record versions and settings so another candidate is measured on the same basis.
  2. Measure task quality. Use representative prompts, expected answers or behaviors, and task-specific metrics. Add failure-sensitive checks such as code execution or factuality where relevant.
  3. Separate prompt and generation performance. Measure prompt processing and token generation distinctly, then report latency and throughput for the batch size and output lengths you expect.
  4. Measure peak memory under load. Test model loading and inference at realistic context and batch settings, rather than relying on the model-load footprint alone.
  5. Check operational fit. Verify load time, supported kernels, stability, and whether there is practical memory headroom. Reject a candidate that only fits under unusually favorable test conditions.

Hugging Face recommends benchmarking accuracy and performance on the specific task and hardware. Its older comparison illustrates why: on one NVIDIA A100-SXM4-80GB, it measured Llama 2 13B with a 512-token prompt in a forward-pass benchmark. At batch size 1, reported throughput was 27.058 tokens/s for fp16, 29.663 for GPTQ 4-bit, and 19.23 for bitsandbytes 4-bit. At batch size 16, it reported 228.76, 167.68, and 140.38 tokens/s, respectively. Those values describe that 2023 setup, not a general speed ranking for current models or runtimes: Hugging Face benchmark comparison.

Task quality can vary by method too. A 2026 preprint studying six 4-bit approaches on Qwen2.5-Coder-7B and CodeLlama-7B with Python and Java code-generation benchmarks found method-dependent effects on correctness and code quality, with results also varying by prompt complexity. Apply that finding to those studied models and tests, not to unrelated tasks: 2026 code-generation study.

Make the selection based on the bottleneck

  • If memory is the constraint: compare 4-bit with 8-bit and the highest-precision feasible baseline, and include KV-cache use in the measurement.
  • If quality is the constraint: test calibrated 4-bit candidates and compare them against a higher-precision baseline using task-specific checks.
  • If setup simplicity matters: consider methods that fit the framework’s direct workflow, while verifying backend support and speed.
  • If serving compatibility is the constraint: prefer a checkpoint and format supported by the exact framework path you will deploy.
  • If throughput is the constraint: benchmark the target batch and concurrency; a result at batch size 1 may not predict behavior at a larger batch.

No format wins independently of model, runtime, kernels, hardware, batch size, prompt length, generation length, and measurement stage. Keep those conditions attached to any benchmark result you use.
