Choose an AI decision model by starting with the workflow and its consequences, not with a model leaderboard. Define the decision the system must support, compare AI with rules and human review, set pass/fail requirements, test a shortlist on representative cases, and approve deployment only when performance, oversight, security, cost, and governance are acceptable together.

This approach avoids a common failure: selecting a technically impressive model that is too error-prone, opaque, expensive, slow, or difficult to control for the actual process. It also leaves “do not deploy AI” as a legitimate outcome.

Start with the workflow, not model names

A model is suitable only in relation to a defined task. The same system can be acceptable for sorting low-risk internal requests and unacceptable for decisions that affect a person’s access to money, employment, healthcare, housing, or essential services. Before comparing vendors or architectures, write down what the workflow does today and what a model would change.

  • Decision or action: Is the system recommending, ranking, classifying, extracting information, or triggering an action automatically?
  • Intended outcome: What business result should improve, such as faster routing, fewer duplicate investigations, or more consistent document review?
  • Users and affected people: Who sees the output, who can override it, and who bears the consequences of an error?
  • Inputs: Which data sources are used, how current they are, what fields may be missing, and whether the data can change after the decision?
  • Baseline: What happens now: a rule set, a spreadsheet, a conventional software process, a human queue, or a combination?
  • Decision timing: Is the output needed in seconds, during a staffed shift, or within a longer service-level window?
  • Reversibility: Can a wrong action be corrected before harm occurs, and how much will correction cost?
  • Constraints: What privacy, security, regulatory, contractual, accessibility, retention, and geographic requirements apply?

NIST’s AI Risk Management Framework (AI RMF) calls for defining the business value and context of use and documenting how outputs may be used and overseen by people. Its framework overview describes the purpose as helping developers, users, and evaluators manage risks that can affect individuals, organizations, society, or the environment. See the NIST AI Risk Management Framework.

Describe the decision boundary

State what is inside and outside the model’s scope. For example, “rank incoming support tickets for a trained agent” is narrower than “resolve customer complaints.” A narrow boundary makes testing and accountability possible. Specify what the model must never do, which inputs require a manual path, and whether an output is advice or an instruction that changes a record, payment, entitlement, or access right.

Check whether AI is appropriate at all

Compare AI with simpler options before building a shortlist. A deterministic rule, validation check, database query, conventional optimization routine, or additional staffing may meet the need with less uncertainty. A human-only or human-first process may be preferable when cases are rare, evidence is ambiguous, or the cost of an incorrect action is high.

NIST’s Manage guidance states: AI systems may not necessarily be the right solution for a given business task or problem. Treat that as a deployment gate, not a disclaimer. Ask whether the expected benefit depends on capabilities that an AI system can deliver reliably in this context, and whether the organization can supervise the result at the speed the workflow requires.

Use a simple appropriateness test

  1. Clarify the bottleneck. Identify the measurable problem: queue time, inconsistent categorization, missed signals, repetitive data entry, or another specific constraint.
  2. Test a non-AI alternative. Estimate what revised rules, better data validation, workflow redesign, or human specialization would achieve.
  3. Assess consequence and recourse. If an error cannot be detected or reversed in time, require a stronger control design or reject automation.
  4. Check data sufficiency. If inputs are sparse, unstable, biased, or unavailable at decision time, an apparently capable model may not be usable.
  5. Make a documented choice. Record why AI is justified, why alternatives were not sufficient, and what conditions would make the decision expire.

Turn business needs into pass/fail criteria

Do not score candidates on a single accuracy number. Set minimum requirements and acceptable error ranges before looking at results. A weighted average must not conceal failure on a high-consequence requirement.

Decision dimension Questions to answer Evidence to collect
Task performance Does the system perform the defined task better than the current process or a simple baseline? Task-specific metrics on representative cases, with the evaluation design documented.
Error profile and impact What mistakes occur, who is affected, and what are the costs of false positives and false negatives? Confusion or error analysis tied to business consequences, reversibility, and escalation.
Reliability and limits How does it behave with edge cases, out-of-scope inputs, missing data, changed data, or knowledge limits? Scenario tests, refusal or abstention behavior, and a written list of out-of-scope conditions.
Human oversight Can staff review, challenge, correct, and escalate outputs within the required time? Screen or workflow demonstrations, review-time measurements, override procedures, and role ownership.
Privacy and security Does data handling fit sensitivity, access, retention, residency, and organizational requirements? Provider documentation, contract terms, access controls, retention settings, and security review.
Explainability and auditability What rationale and evidence must be retained to reconstruct a decision? Decision records, input and output logs, version identifiers, reviewer actions, and retention rules.
Operational fit Can the system integrate with existing software and meet latency, availability, maintenance, and resilience needs? Integration test results, service objectives, failure handling, monitoring, and recovery procedures.
Economics Is the full cost lower than the value created at the required quality? Inference or licence costs, integration, human review, monitoring, support, and the cost of errors.
Governance and third-party risk Who is accountable, and what happens if a provider changes the model, terms, or service? Ownership matrix, procurement controls, change-notice terms, supply-chain review, and recourse plan.

Separate gates from preferences

Mark each criterion as a hard gate, a target, or a preference. A hard gate might be a required data-retention control, a maximum response time, or a prohibition on unattended actions. A target can improve the ranking among candidates that pass. Preferences, such as a familiar programming interface, should never outweigh a safety or compliance failure.

Build a shortlist and a meaningful baseline

Include the current process and at least one simple alternative in the evaluation. Depending on the workflow, candidates might be a rules engine, a conventional statistical or machine-learning model, a retrieval-based system, a generative model with structured checks, or a human review queue. The point is not to compare fashionable categories; it is to compare approaches that can actually receive the available inputs and produce the required output.

Free tools Windows power users keep installed

Ask each candidate the same questions

  • What inputs and preprocessing does it require?
  • What output does it produce, in what format, and with what confidence or uncertainty signal?
  • Can it abstain or route an uncertain case to a person?
  • What known limitations, knowledge cut-off, or domain exclusions apply?
  • Which settings, model versions, prompts, policies, or training data can change behavior?
  • What logs, explanations, and version identifiers are available?
  • How are outages, rate limits, malformed inputs, and partial failures handled?

A provider’s general benchmark is not a substitute for testing your workflow. NIST recommends understanding capabilities and goals, using appropriate benchmarks, and examining expected benefits and costs. A benchmark can help narrow a list; it cannot establish production performance for your data, users, thresholds, and controls.

Design an evaluation that resembles production

Evaluation quality depends more on case selection and decision rules than on the elegance of a leaderboard. Build a test set that reflects the situations the system will encounter after launch.

Assemble representative cases

  • Sample normal cases in the proportions the workflow actually sees.
  • Include rare but consequential cases, not only the majority class.
  • Include missing, contradictory, stale, malformed, and out-of-scope inputs.
  • Cover relevant languages, formats, customer segments, locations, and operating conditions.
  • Keep an untouched holdout set for final comparison after tuning.

Document how labels were created, who reviewed ambiguous examples, and whether the test data may contain information unavailable at decision time. If the process changes seasonally or after a policy update, test those conditions separately.

Choose task-specific measures

Use measures that match the decision. Classification may require precision, recall, calibration, or a cost-weighted error rate; ranking may require useful results near the top of the queue; extraction may require field-level correctness; generation may require factuality checks and human acceptance. Report the baseline using the same cases and definitions. Do not collapse all outcomes into one score if different errors have different consequences.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Test scenarios and limits explicitly

Run cases that probe refusal, uncertainty, conflicting evidence, distribution changes, and missing fields. Record not only whether the answer is wrong, but whether the system signals uncertainty, gives a misleadingly confident answer, or creates an action that a reviewer cannot easily undo. NIST identifies knowledge limits, human oversight, and testing, evaluation, validation, and verification (TEVV) as relevant considerations; its AI RMF Core and AI RMF Playbook provide organizing guidance.

Compare under realistic operating conditions

Measure response time, throughput, concurrency, timeout behavior, and recovery from service errors. Test the exact integrations, permissions, preprocessing, prompts or policies, and post-processing that the workflow will use. A model that performs well in an isolated notebook may fail when upstream data is late or a downstream system rejects its output.

Analyze errors before choosing a winner

Aggregate metrics tell you how often something happens; error analysis tells you whether the failure is tolerable. Review incorrect, uncertain, and abstained cases with domain experts and the people who will operate the workflow.

Map each error to its consequence

  • False positive: The system flags, rejects, escalates, or acts when it should not.
  • False negative: The system misses a condition that required attention.
  • Omission: The output leaves out evidence or a required field.
  • Fabrication or unsupported rationale: The system presents an answer or explanation not grounded in available evidence.
  • Process failure: The model is correct, but the output arrives too late, cannot be reviewed, or cannot be recorded.

Estimate who is affected, how quickly the error can be detected, whether it can be reversed, and what remediation costs. Set separate thresholds where one error type is substantially more harmful than another.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Use thresholds and abstention deliberately

A model need not decide every case. Raising a confidence threshold can reduce automated errors while increasing the manual queue. That trade-off is acceptable only if staffing, service levels, and escalation capacity support it. Define the threshold, the abstention condition, and the reviewer’s required action as part of the workflow specification rather than leaving them to an informal operator habit.

Design human oversight that works in practice

“Human in the loop” is not a control unless the person has enough information, authority, time, and independence to change the outcome. Specify who reviews which cases, what evidence they see, how they challenge a result, and when they must escalate.

Match oversight to consequence

  • Low-impact, reversible routing can use sampling or exception review.
  • Moderate-impact decisions may require review of every low-confidence case and periodic quality audits.
  • High-impact or irreversible actions generally require an authorized person to make or confirm the decision, with a clear appeal or recourse path.

Measure review workload and time. If the model produces too many uncertain cases, the organization may be unable to provide meaningful oversight even when the model’s aggregate score looks strong. Train reviewers on known limitations and record overrides so recurring failure modes can be corrected.

Questions for the provider and internal teams

  • Where is data processed and stored, and what residency options are available?
  • Is customer data retained, used for provider improvement, or accessible to support personnel?
  • How are tenant isolation, encryption, identity, access, and key management implemented?
  • Can administrators delete records and satisfy retention or legal-hold requirements?
  • What happens when a provider, subcontractor, model version, or hosting region changes?
  • How are prompt injection, malicious files, data exfiltration, and compromised credentials addressed?

Limit data to what the task needs. Mask or tokenize sensitive fields where possible, enforce least-privilege access, and keep audit logs separate from user-editable content. Security controls do not make an unsuitable model appropriate; they are one part of the decision.

Check operational fit and full economics

Calculate the cost of the complete process, not just an API call or licence. Include integration, data preparation, evaluation, human review, monitoring, incident response, retraining or reconfiguration, storage, and the financial impact of errors. NIST calls for examining expected benefits and costs but does not publish a universal cost figure or a ranking of business models.

Stress the service design

  • Define latency and availability requirements for each workflow stage.
  • Set behavior for timeouts, provider outages, quota exhaustion, malformed responses, and degraded modes.
  • Decide whether a cached, rules-based, or manual fallback is acceptable.
  • Plan capacity for peaks rather than average traffic alone.
  • Assign owners for model updates, data changes, monitoring alerts, and incident response.

Recalculate economics when the task volume, model version, pricing terms, review rate, or error pattern changes. A cheaper model can cost more overall if it creates additional manual work or harmful mistakes.

Third-party dependencies require change management. Contract and procurement teams should examine service commitments, notice of material model changes, data use, audit rights, subcontractors, incident notification, termination assistance, and portability of logs and configurations. Maintain a tested exit or fallback path when the workflow is important enough that a provider outage or unilateral change would disrupt operations.

Use the NIST AI RMF as a lifecycle structure

The NIST AI RMF is voluntary, non-sector-specific, and use-case-agnostic. It is guidance for incorporating trustworthiness into AI design, development, use, and evaluation, not a certification of a particular model and not a replacement for sector-specific law or internal controls. AI RMF 1.0 was published on January 26, 2023, and NIST’s current resource pages indicate ongoing revision activity; check the live NIST pages for the latest version.

Function How it informs model selection
Govern Establish accountability, policies, roles, risk tolerance, procurement controls, and lifecycle oversight.
Map Define the business context, intended use, affected people, benefits, risks, assumptions, and whether the use is appropriate. This information informs model-management and deployment decisions.
Measure Apply evaluation, validation, verification, monitoring, and testing to performance, reliability, security, privacy, and other trustworthiness characteristics.
Manage Prioritize and respond to identified risks, apply controls, document residual risk, and decide whether to deploy, limit, pause, or stop the system.

NIST describes these functions as lifecycle activities rather than a mandatory linear sequence. Teams may revisit mapping after measurement, change governance when a provider changes, and manage new risks discovered in operation. The AI RMF Core and Manage guidance provide the associated outcomes and practical prompts.

Make the deployment decision explicit

At the end of evaluation, choose one of four outcomes: deploy within a defined scope, deploy only with additional controls, continue a limited pilot, or do not deploy. Write the rationale in terms of the pre-set gates and the evidence collected, not in terms of enthusiasm for a model family.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Minimum contents of the decision record

  • Workflow description, intended purpose, users, affected groups, and out-of-scope uses.
  • Baseline and shortlisted approaches, with versions and configuration identifiers.
  • Evaluation data, methods, metrics, scenario coverage, and error analysis.
  • Known limitations, abstention rules, review and escalation paths, and recourse.
  • Privacy, security, integration, availability, resilience, and third-party findings.
  • Full cost assumptions, expected benefits, and the owner responsible for validating them.
  • Monitoring signals, alert thresholds, review cadence, rollback or shutdown procedure, and next review date.

Define no-go and stop conditions

Examples include failure of a mandatory privacy control, inability to provide required human review, unacceptable error in a high-consequence scenario, missing audit evidence, unstable behavior after data changes, or economics that depend on unrealistic review assumptions. Stop conditions should be actionable: identify who can pause the system, what fallback is used, and how affected decisions are revisited.

Worked example: routing invoice exceptions

Imagine a finance team that routes invoices requiring specialist review. The proposed system would classify incoming invoices into routine processing, tax review, duplicate investigation, or manual escalation. The decision is not “which model is smartest?” It is whether a particular approach improves routing without hiding errors or creating payment risk.

Frame the workflow

Document the invoice fields available at intake, the current rule set, the reviewers responsible for each queue, the time allowed before payment deadlines, and the consequences of sending a suspicious invoice to the routine queue. Define that the system may recommend a queue but may not approve payment.

Compare approaches

Test the existing rules, a supervised classifier, and a model-assisted approach that extracts fields before applying deterministic validation. Use the same historical and newly reviewed cases, including missing purchase-order numbers, duplicate invoices, unusual currencies, and policy changes. Keep a manual queue as the baseline and record review time as well as classification quality.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Set controls and evaluate

Require automatic escalation when critical fields conflict, when confidence is below the agreed threshold, or when the input is outside the trained scope. Review false negatives more heavily than false positives if missed duplicates create greater loss. Log the source fields, model version, recommendation, reviewer decision, and any override. If the system cannot provide those records or reviewers cannot act before payment deadlines, do not deploy it for that step.

This example illustrates the method: define the action boundary, test realistic cases, assign error costs, preserve human authority, and make deployment conditional on evidence. The same sequence applies to ticket triage, document review, fraud investigation, eligibility screening, and other workflows, with different thresholds and controls.

Selection checklist

  • Have you defined the business outcome, users, affected people, inputs, timing, and consequences?
  • Have you compared AI with rules, conventional software, process changes, and human review?
  • Are hard requirements and acceptable error ranges written before scoring candidates?
  • Does the test set represent normal, rare, missing, changing, and out-of-scope cases?
  • Are results compared with the current process or a simple baseline?
  • Have you analyzed false positives, false negatives, uncertainty, omissions, and process failures?
  • Can authorized staff review, challenge, correct, and escalate outputs at the required speed?
  • Are privacy, security, retention, access, audit, integration, availability, and fallback controls verified?
  • Does the economic case include human review, monitoring, integration, support, and error costs?
  • Are ownership, provider-change controls, monitoring, rollback, and stop conditions documented?
  • Has an accountable owner approved deployment—or documented why the system should not be deployed?
