Benchmark the workload you plan to move—not the accelerator’s peak FLOPs. Keep the model, data, precision, quality target and training batch or inference request mix consistent; separate compilation and warm-up from steady-state timing; measure throughput, latency, memory and the cost of completing the same useful work; then profile the TPU run to explain its bottlenecks. A TPU is a good migration candidate only if it meets your workload’s performance and operational requirements in the deployment configuration you expect to use.

How do I benchmark TPU performance before moving my AI workload?

Build a controlled comparison around a defined task and a production-relevant Cloud TPU configuration. A benchmark that changes the model, precision, input lengths, quality target or batch size at the same time as the hardware cannot tell you which change caused the result. The protocol below is a practical comparison plan, not a universal benchmark standard published by Google.

1. Define the workload and success criteria

Record the model and code version, framework, input data and tensor shapes, precision, training batch size or inference request distribution, target quality, sequence lengths, and number of devices and hosts. Specify the work that counts as success: for training, that may be reaching a fixed validation target; for inference, it may be serving a stated request mix within a latency target. Use the same task definition for each candidate.

  • Keep inputs and quality criteria consistent. If a configuration needs a different precision, batch, or implementation to fit, record that as a changed condition rather than presenting it as a strictly like-for-like result.
  • Choose a representative operating point, not just the largest batch that fits. Serving workloads should reflect expected request sizes and concurrency; training workloads should reflect the batch and data pipeline you intend to run.
  • Record the device count and topology. A single-chip result does not predict multi-chip or multislice scaling.

2. Choose the TPU configuration you could deploy

Use compute, memory and scaling needs to select candidate hardware, then measure the application. Google Cloud’s published peak compute figures provide selection context, not an end-to-end speedup forecast:

TPU generation Published peak compute per chip How to use the figure
TPU7x (Ironwood) BF16: 2,307 TFLOPs; FP8: 4,614 TFLOPs Published hardware specification in Google Cloud documentation current in 2026; not a workload benchmark.
TPU v6e (Trillium) BF16: 918 TFLOPs; FP8: 918 TFLOPs Published hardware specification in Google Cloud documentation current in 2026; not a workload benchmark.
TPU v5p BF16: 459 TFLOPs; FP8: 459 TFLOPs Published hardware specification in Google Cloud documentation current in 2026; not a workload benchmark.

These are peak per-chip specifications in the stated precisions. They do not account for your model’s operations, data delivery, memory behavior, communication, software path or utilization. Confirm that the candidate’s memory and scale fit your target workload before investing in a long comparison.

3. Separate compilation, warm-up and measurement

TPU workloads use XLA compilation. Record startup and compilation time separately if they affect deployment or short-lived jobs. For a sustained workload, allow compilation and warm-up to finish before timing steady-state work. State exactly which steps or requests were excluded and which were measured. Mixing compilation into one run but excluding it from another makes the comparison misleading.

4. Run repeated, comparable measurements

Use the same measurement window and workload conditions across runs. Repeat the run sufficiently to see whether the result is stable, and preserve the individual results rather than reporting only the best one. Record interruptions, retries or unusual resource contention rather than silently discarding inconvenient measurements.

For training, track step time and examples or tokens processed per second, along with time to the same quality target. For inference, report throughput alongside latency percentiles for the same request mix; high throughput is not useful if latency violates the serving requirement. In both cases, capture memory use and calculate the cost of completing the same useful work, not merely the hourly accelerator rate.

5. Profile the measured run and investigate bottlenecks

Google’s Cloud TPU performance guide calls profiling the first step in troubleshooting TPU performance. Capture comparable profile windows across candidates so you can explain a measured difference rather than infer one from a utilization percentage. XProf supports programmatic capture for selected steps or code blocks, as well as on-demand capture when a profile server is enabled. Profiles can be stored on the TPU VM or in Cloud Storage and inspected with TensorBoard.

6. Preserve a reproducibility record

Keep a short run record with the code and data versions, TPU generation and topology, framework/compiler/runtime versions, precision, batch or request shapes, quality target, warm-up procedure, measurement window, repetitions and metric definitions. Include the profile location and any deviations from the planned setup. Without these details, a future rerun may not be comparable even if it uses the same model name.

How can I compare TPU and GPU performance fairly?

Compare complete configurations doing the same useful work. “TPU versus GPU” is not a single hardware-only variable: the framework, compiler path, precision, device count, host resources, data pipeline and scale can all change the result. The official Google Cloud material cited here does not establish a universal head-to-head result, guaranteed speedup or guaranteed cost saving for an unspecified workload.

Comparison axis What to hold constant or report What the result tells you
Training throughput Model, data, quality target, precision and effective batch; report steps and examples or tokens per second. How quickly each setup processes the training workload, and whether it reaches the same quality target sooner.
Inference service Request mix, input/output lengths, quality target and serving conditions; report throughput and latency percentiles. Whether a setup meets both capacity and response-time needs.
Memory fit Target batch or request shapes and memory use under those shapes. Whether the intended operating point fits and whether capacity forces a workload change.
Scaling and communication Device count, host count and topology; compare at relevant scales. Whether added devices increase useful work proportionally or communication becomes a constraint.
Total cost for useful work Include relevant accelerator, host and data-pipeline resources for the same completed task. Cost per training milestone or served workload, rather than cost per accelerator-hour alone.
Engineering and operations Framework support, deployment control, orchestration and migration effort. Whether measured performance is practical to maintain in the intended production path.

Run each system through its supported, production-relevant software path, and document differences that cannot be made equivalent. A comparison that gives one system more devices, a different quality target or a more favorable request mix can still inform a deployment choice, but it is not evidence of an intrinsic accelerator advantage.

What should I measure besides peak FLOPS?

Peak FLOPs describe a hardware specification for a particular precision; they do not say how much of that capacity your application uses. Measure the outcomes and constraints that determine whether the workload can be operated successfully:

  • Useful throughput: examples, tokens or completed requests per unit time, with the unit and workload definition stated.
  • Time to outcome: for training, elapsed time to a fixed quality target; for inference, time to serve a defined volume while meeting latency requirements.
  • Latency distribution: percentiles under the representative request mix, rather than an average that can hide slow requests.
  • Memory behavior: use and fit at the target shape and batch, including whether padding or sharding changes the effective requirement.
  • Scaling behavior: the change in useful throughput and communication behavior as devices or slices are added.
  • End-to-end cost: the resources needed to complete the same amount of useful work, including relevant host and input-pipeline resources.
  • Operational overhead: startup and compilation when material, plus the deployment and orchestration work needed to run the measured configuration.

Google’s published TPU generation specifications can help narrow hardware candidates, but application-level outcomes must come from your benchmark. The documentation cited here does not provide a universal TPU-versus-GPU result for an unspecified model.

How do I profile a model running on Cloud TPU?

  1. Choose a representative capture window. Select steps, requests or a code block that reflects the steady-state work you are comparing. Do not profile compilation in one candidate and steady state in another unless startup behavior is the subject of the test.
  2. Capture with XProf. Use programmatic capture for selected steps or code blocks, or use on-demand capture when the profile server is enabled. Google’s “Profile your model on Cloud TPU VMs” documentation describes these capture approaches.
  3. Store and inspect the profile. Keep it on the TPU VM or in Cloud Storage, then inspect it with TensorBoard’s XProf views. Keep profile windows and workload conditions comparable between runs.
  4. Use the view suited to the question. Trace Viewer shows execution timelines; HLO Op Profile groups time by operation category; Memory Viewer shows allocations; Roofline Analysis helps assess compute- versus memory-bound operations; Graph Viewer shows the compiled HLO graph.
  5. Change one major factor, then repeat. Use the profile to identify a plausible bottleneck, adjust one meaningful factor, and rerun the same benchmark and capture window. Preserve before-and-after profiles with the run records.

Google Cloud’s 2026 JAX AI Stack documentation says XProf’s use of TPU-integrated profiling features enables a collection overhead of “less than 1%.” This is a vendor-reported claim in that documentation, not a guarantee for every model, capture configuration or environment.

How do I interpret a slow TPU benchmark?

Use the profile to find where time or capacity is going before changing the model or scaling up. Google’s Cloud TPU performance guidance identifies input delivery, batch size and sharding, memory management, network performance, XLA padding and tensor dimensions as areas to examine.

What to investigate Why it can matter Useful next check
Input delivery If the input pipeline cannot keep up, accelerator capacity may wait for data. Inspect the timeline and input path; determine whether delivery rather than device computation limits the measured window.
Batch size and sharding Batching and distribution affect how work is placed across devices and how much useful work each step contains. Verify that the intended batch is actually sharded as expected, then compare controlled batch changes.
Host/device transfers Transfers can add overhead or disrupt otherwise efficient device execution. Inspect execution timelines and the data movement around the measured operations.
Memory use Memory limits can constrain batch or shape choices; allocation behavior can expose pressure. Use Memory Viewer and test the actual production shapes, not only a smaller proxy.
Shapes and XLA padding Padding can waste compute capacity and increase memory requirements. Shape tiling and padding effects vary by TPU generation. Inspect the workload’s dimensions and compiled graph; assess whether irregular or changing shapes force inefficient padded work.
Operation mix TPUs are specialized for matrix operations; programs dominated by other operations may not make effective use of matrix units. Use HLO Op Profile and the compiled graph to see which operation categories consume time.
Inter-slice network For multi-slice work, communication may limit scaling even when individual devices have capacity. Inspect network performance and compare scale points using the same work definition.

A high or low utilization percentage alone does not identify the cause. Pair it with the timeline, operation mix, memory view and workload conditions. Make one major change at a time so the next run tests a specific explanation rather than introducing several new variables.

Is my model a good fit for a TPU?

TPUs are specialized for matrix operations, so workloads centered on dense matrix computation are more naturally aligned with the hardware. Fit is not a binary property of a model name: the operation mix, tensor shapes, memory needs, input pipeline, target scale and framework path determine whether a particular implementation performs well.

  • Potentially favorable: workloads with substantial matrix computation and stable, well-understood shapes, provided they fit memory and scale as required.
  • Potential challenges: workloads dominated by non-matrix operations such as add, reshape or concatenate may not achieve high MXU utilization.
  • Dynamic shapes: Google’s TPU introduction cautions that dynamic tensor shapes are not well suited because XLA compiles the graph for the first batch.
  • Padding: shape padding can leave core capacity underused and increase memory requirements; the effects of shape tiling and padding depend on TPU generation.

These traits are screening clues, not a substitute for running the real workload. A model with a favorable operation mix can still be limited by data delivery, memory or communication, while a less obvious fit may meet the target at the right shapes and scale.

What does the TPU deployment path mean for migration?

The benchmark should use a provisioning path that remains viable for the intended production deployment. Google’s Compute Engine documentation says the legacy Cloud TPU API is no longer under active development and receives bug fixes and security updates only. The documentation identifies Compute Engine and Google Kubernetes Engine (GKE) as migration paths, and says TPU7x and later new hardware generations are supported through Compute Engine or GKE.

Path Google’s stated fit Migration consideration
Compute Engine Direct VM-level control or custom OS images. Check that the VM-level configuration and operational controls match the production plan.
GKE Containerized workloads, automated scaling and large-scale orchestration. Include orchestration and container deployment in the tested path if they are part of production.
Legacy Cloud TPU API Receives bug fixes and security updates only; no longer under active development. Existing resources created through the legacy API are incompatible with Compute Engine and GKE. Migration requires rewriting API-dependent scripts and recreating resources.

A fast result on an environment you cannot or will not use in production is not a migration result. Account for the engineering effort and control model of the target path alongside its measured performance.
