Assess the operation before assessing the algorithm. A heavy-industry AI pilot is ready only when a specific problem, measurable outcome, usable data, actionable workflow, and risk controls are defined. Start by documenting the asset or process and the decision that might change; then establish a baseline, estimate system-level value and cost, check safety and governance, and write pass/fail criteria for the pilot. If you cannot observe the outcome or safely act on the output, revise or reject the use case before deployment.
What a pre-pilot assessment must establish
A proposal such as “use AI for predictive maintenance” is not yet a use case. A usable statement identifies:
- Process and asset: the furnace, mill, conveyor, compressor, production line, warehouse flow, or other operating context.
- Decision or action: what a person or control system would do differently after receiving the output.
- Operational problem: the failure, delay, defect, energy waste, exposure, or other pain point being addressed.
- Outcome measure: the result that should change, such as unplanned downtime, scrap, inspection backlog, energy per tonne, or maintenance response time.
- Intended users and limits: who receives the output, under which operating conditions, and what the system is not allowed to decide.
NIST’s industrial procedure begins by asking whether a process is suitable for condition monitoring and whether monitoring can detect problems whose risks can be mitigated. That is a useful screening principle for other industrial AI ideas: begin with the decision and its consequences, not with a model demonstration or a vendor feature. See the NIST evaluation procedure and its publication record.
Make the statement specific enough that a person unfamiliar with the project could identify the equipment, time window, output, and decision owner. “Improve quality with AI” is too broad; “flag coil-surface defects for an inspector before release, using the line camera and production context, without replacing the release decision” is testable. Explicit exclusions matter just as much: note whether the system may recommend an inspection, initiate a work order, alter a set point, or merely display information.

Step 1: Define the operational problem and counterfactual
Write the current-state description
Record how the operation works today, including the normal decision owner, timing, available signals, and existing safeguards. Describe a representative event: a bearing failure, quality deviation, unsafe exposure, late shipment, or process excursion. State what happens without AI and which intervention is realistically available.
Specify the counterfactual
The assessment should compare the proposed workflow with the current one. For example, an alert might lead maintenance to inspect an asset during a planned outage rather than after a breakdown. If no one can act before the event, a technically accurate prediction may have no operational value.
Check actionability
- Is there enough lead time for a safe and useful response?
- Does a named role have authority, capacity, and procedures to act?
- Can the action be reversed or overridden?
- Would an alert create alarm fatigue, production interruptions, or conflicting instructions?
Map the handoff from output to action. Identify where the alert appears, who acknowledges it, what evidence they need, and how completion is recorded. A recommendation that arrives after a shift change, lacks an asset identifier, or cannot be reconciled with a work-order system may fail even when its prediction is sound.
Step 2: Test whether the process and data are suitable
Look for observable events
List the signals and records that could support the intended use: historian tags, vibration or temperature readings, laboratory results, inspection images, work orders, operator logs, quality records, environmental data, and production context. Identify how an event is labelled and whether the label is trustworthy. A model cannot validate a failure that was never recorded consistently.
Check data fitness, not just volume
- Coverage: Are the relevant assets, shifts, products, and operating modes represented?
- Timing: Do timestamps align across sensors, controls, maintenance, and outcome records?
- Quality: Are gaps, sensor drift, calibration changes, and manual corrections documented?
- Provenance: Can you explain where each input came from, who may change it, and which transformations were applied?
- Drift: Will recipes, equipment, operators, weather, feedstock, or regulations change the relationship between inputs and outcomes?
Separate historical availability from pilot availability. A signal that exists in a data lake may not be available at the required latency or reliability in the control-room workflow. Confirm access rights, retention periods, network paths, and whether collecting a new signal changes safety certification or maintenance obligations.
Decide whether monitoring can detect a meaningful problem
Some failures have clear precursors; others are rare, abrupt, or dominated by unmeasured conditions. If the event cannot be observed reliably, define a different outcome or stop the candidate. NIST’s condition-monitoring method is specific to that class of problem and manufacturing examples; it should not be treated as validation for every AI application or every heavy-industry sector.
Check the negative case as carefully as the positive case. Determine how often the process operates outside the conditions represented in the records, what happens during sensor outages, and whether a missing value should trigger a safe fallback rather than an inferred prediction. If labels depend on inconsistent inspection or maintenance practices, improve the recording process or narrow the intended use before modeling.

Step 3: Establish a baseline before claiming value
Capture the current performance over a defined period and operating mix. Depending on the use case, the baseline may include event frequency, severity, detection time, false alarms, downtime, scrap, energy use, inspection effort, injuries or near misses, and maintenance cost. Document how the metric is currently measured so a later change is attributable and auditable.
For condition monitoring, NIST calls for considering baseline risk without monitoring, installation and operating costs, risks introduced by the monitoring system, estimated value, and a risk-based investment analysis. Apply the same system-level logic to quality, safety, energy, logistics, or production proposals rather than using model accuracy as a substitute for business evidence. The NIST procedure and guide describe this framing.
Define the value hypothesis
Write a testable chain: “If the system produces X output with Y reliability, the responsible team will take Z action, changing outcome Q by an observable amount.” Include avoided losses and new burdens. An alert that prevents downtime may also require additional inspections, spare parts, analyst review, cybersecurity controls, or production slowdowns.
Include total cost and operational risk
- Instrumentation, edge or plant-network changes, compute, licensing, and integration.
- Data engineering, model maintenance, recalibration, monitoring, and retraining.
- Operator, engineer, maintenance, and safety-review time.
- Costs of false positives, missed events, delayed action, or an unavailable system.
- Decommissioning, rollback, and continued operation of the existing safeguards.
Do not count a high laboratory score as facility value. A pilot must show whether the complete intervention works under the operating constraints that matter.

Separate one-time pilot spending from the cost of keeping a successful system dependable. A temporary data pipeline, manual label-cleaning effort, or vendor engineer may be acceptable for learning but not sustainable at scale. Record which costs disappear, which become recurring, and which existing controls must remain in place. Include the opportunity cost of operators and engineers who must review outputs or participate in testing.
Step 4: Map candidate ideas across the operation
Use application areas as a discovery checklist, not as a promise that any category is valuable at your site. Manufacturing-focused material from the World Economic Forum identifies:
- health and safety
- quality
- maintenance
- production process
- supply chains
- energy management
For each idea, write the process, decision, outcome, and evidence source. A safety use case may need a different tolerance for missed events and a different approval path from an energy-forecasting tool. Applying the checklist to mining, metals, chemicals, utilities, or construction requires checking the sector’s process hazards, controls, workforce arrangements, and regulations rather than assuming manufacturing evidence transfers.

Look for dependencies between candidates. A quality model may depend on the same camera, historian tags, or operator workflow as a maintenance model. Two pilots competing for one network connection or one specialist team should not be treated as independent. Record shared infrastructure, data ownership, and whether running one system changes the baseline for another.

OECD due-diligence guidance recommends examining the AI system and use case, business purpose, data inputs, physical extensions, human-in-the-loop elements, deployment context, scientific validity, and foreseeable improper use or misuse. It also calls for attention to human oversight, expert and stakeholder consultation, robustness, security, privacy, and sector-specific rules. Use the OECD guidance as a broad assessment layer.
Safety and consequence of error
Classify what can happen if an output is wrong, late, unavailable, manipulated, or misunderstood. A recommendation that influences a safety interlock, hazardous-energy procedure, product release, or emergency response needs more stringent review than an internal planning suggestion. Preserve independent safeguards; a pilot should not silently replace a proven protection layer.
Human oversight and workforce effects
Name the person accountable for accepting, rejecting, escalating, and documenting an output. Define override authority and the evidence that user receives. Consult operators, maintainers, engineers, safety professionals, and affected representatives early. Consider changed duties, training, workload, surveillance concerns, and incentives that could cause people to bypass the system or follow it mechanically.
Security, privacy, and misuse
Review access control, network segmentation, logging, model and data tampering, vendor or third-party access, and recovery when services fail. Identify personal or sensitive workforce data and apply the rules that govern its collection and use. List foreseeable misuse, including applying a model outside its trained operating range or repurposing a safety output for discipline without appropriate review.

Applicable obligations depend on jurisdiction, sector, process, and the system’s role. OECD guidance points to context-specific laws and standards but does not resolve them for an unspecified project. Bring legal, compliance, functional-safety, cybersecurity, environmental, and labor expertise into the review where relevant.
Use a staged review. A low-consequence planning aid may need ordinary data and security checks, while a system connected to physical equipment or a consequential personnel decision deserves deeper due diligence. Escalate when evidence is incomplete, the intended use expands, or an output could affect people or protected operations in ways the original assessment did not cover.

How to compare several AI pilot candidates
Use the following axes to structure a decision record. They synthesize NIST’s system-level investment approach and the OECD due-diligence dimensions; they are not a validated universal scoring rubric. Score or describe candidates consistently, then investigate any high-consequence uncertainty instead of hiding it in an average.
| Axis | Questions to answer | Evidence to collect |
|---|---|---|
| Operational value | Which defined outcome could change, by what mechanism and timeframe? | Baseline metric, counterfactual, benefit hypothesis, affected process owner |
| Baseline and observability | Can relevant events, decisions, and outcomes be identified reliably? | Historical records, labels, coverage, timing, measurement limitations |
| Technical and data readiness | Are inputs fit for purpose and available in the intended workflow? | Data quality and provenance, integration design, latency, drift risks |
| Cost and ongoing burden | What must be installed, operated, maintained, reviewed, and eventually retired? | One-time and recurring costs, staffing, training, support, downtime impact |
| Risk and consequence | What is the effect of a false, missed, biased, delayed, or compromised output? | Hazard analysis, security and privacy review, misuse cases, escalation needs |
| Actionability and oversight | Can responsible users understand, challenge, override, and safely manage the result? | Workflow map, human factors review, decision rights, fallback procedure |
Do not let a single composite score conceal a disqualifying issue. For example, excellent data and large theoretical savings do not compensate for an unresolved safety approval or an output that no authorized worker can use. Keep a written rationale for weights, assumptions, unknowns, and the conditions that would change the ranking.
Step 6: Write the pilot boundary and evidence plan
- State the intended use. Define the users, asset or process, operating modes, input window, output, timing, and prohibited uses.
- Choose the evaluation design. Specify the baseline period, comparison group or counterfactual where feasible, sampling plan, and how operational outcomes will be attributed.
- Set success measures. Include both model measures and facility measures: for example, detection timeliness, false-alert burden, completed interventions, downtime, quality, energy, or safety-process adherence.
- Set failure and escalation conditions. Define when to suppress an output, require human review, revert to the existing procedure, pause data collection, or stop the pilot.
- Document validity against intended use. NIST’s 2025 ARIA report says, “NIST chose to focus on validity as the primary metric for the pilot, the degree to which application output met the requirements for the intended use.” This describes an evaluation concept from ARIA 0.1, not a manufacturing field result; see the NIST report record.
- Assign decision ownership. Name the operational sponsor, technical owner, safety and security reviewers, data steward, and final go/no-go authority.
- Plan rollback and learning. Keep existing controls available, log decisions and overrides, and specify what evidence will change the design or end the pilot.
Define what will be measured during the pilot and what will be reviewed after it. Track not only predictions but also whether users saw them, understood them, acted on them, overrode them, or ignored them. Record operating mode, asset condition, data outages, and unusual events so a favorable or unfavorable result can be interpreted rather than attributed blindly to the model.

Proceed when
- The problem and changed action are specific.
- A baseline and credible outcome measure exist.
- Inputs are accessible, sufficiently reliable, and lawful to use.
- Users can act within the available time and have a safe fallback.
- Costs, integration work, and error consequences are understood well enough to set boundaries.
- Intended use, success criteria, oversight, and escalation rules are approved.
Revise when
- The value depends on a signal that needs better instrumentation or labelling.
- The output is useful only after changing the workflow, staffing, or maintenance plan.
- The candidate is promising but its risk, legal status, or counterfactual is unresolved.
Stop when
- No meaningful event or outcome can be observed.
- No responsible person can act on the output.
- Potential harm exceeds the plausible benefit and cannot be mitigated.
- The pilot would weaken existing safeguards or proceed without required approvals.
OECD describes baseline screening followed by more in-depth due diligence for higher-risk cases. Use that escalation path when information is incomplete or consequences are severe. A pilot is justified by a testable operational hypothesis, observable outcomes, and a manageable plan for cost and risk—not by enthusiasm for AI.
What implementation statistics can—and cannot—tell you
A 2023 World Economic Forum industrial-operations guidebook page states that “only one in six has been successful to date.” This is a dated, broad manufacturing implementation claim on that page, not a current adoption rate, a heavy-industry-specific pilot success rate, or a forecast for your organization. Treat it as a reminder to assess integration and change management carefully, not as a probability to apply to a business case. Source: WEF guidebook.
When outside assistance is justified
Optional support from an industrial AI assessment or implementation specialist can help when internal teams lack condition-monitoring, data-engineering, functional-safety, or change-management capacity. Select a provider by asking for a clearly bounded intended use, evidence of work in comparable operating contexts, transparent assumptions and cost categories, data and security responsibilities, an approach to human oversight, and a rollback plan. Require the provider to distinguish a model demonstration from a system-level investment case. No outside provider can remove the site owner’s responsibility for safety, legal compliance, decision rights, or acceptance criteria.

Frequently Asked Questions
How do I know if an industrial AI use case is ready for a pilot?
It is ready when the operational problem, changed action, baseline, usable inputs, intended users, success measures, fallback, and risk approvals are explicit. If no one can act within the available time or the outcome cannot be observed, revise or stop the proposal.
Should predictive maintenance always be the first heavy-industry AI pilot?
No. Maintenance is one candidate area alongside health and safety, quality, production process, supply chains, and energy management. Choose based on observable events, actionability, value, cost, and consequence of error at your site.
What data should be checked before an industrial AI pilot?
Check historian and sensor signals, inspection and laboratory records, work orders, operator logs, quality records, environmental context, and production conditions. Verify coverage, timestamp alignment, gaps, calibration changes, provenance, access, latency, retention, and likely drift.

Compare operational value, baseline observability, technical and data readiness, total cost and ongoing burden, risk and consequence, and actionability with human oversight. Use a consistent record, but do not average away a high-consequence uncertainty.
What belongs in the cost estimate?
Include instrumentation, network and edge changes, compute, licensing, integration, data engineering, maintenance, recalibration, monitoring, retraining, user and safety-review time, false or missed events, outages, rollback, and continued operation of existing safeguards.
When does an AI pilot need deeper due diligence?
Escalate when outputs can influence safety controls, hazardous-energy procedures, product release, emergency response, personnel decisions, or other consequential operations; when data or legal status is uncertain; or when misuse, security, privacy, or workforce effects are material.
Can a vendor’s model accuracy prove that a pilot will create value?
No. Facility value depends on the complete intervention: whether the output arrives in time, a responsible user acts, the action changes the baseline outcome, and the added costs and risks remain acceptable.
The Bottom Line
Choose a heavy-industry AI pilot only after the operational problem, measurable baseline, actionable workflow, total system economics, and risk controls are explicit. Where those elements cannot yet be demonstrated, improve the process or evidence first; the right pre-pilot decision may be to revise or stop rather than deploy.
