Low-bit quantization usually cuts the memory required for an LLM’s weights, can let a model fit on a smaller GPU, and may improve inference speed. It does not guarantee a fixed memory reduction, faster responses, or unchanged quality. The result depends on the quantization method, bit width, model, task, accelerator, serving runtime, kernels, context length and batch size. Treat 4-bit or 8-bit as a configuration to benchmark, not as a performance promise.

What low-bit quantization changes in an LLM

Quantization stores numerical values with fewer bits. Most language models are distributed or served with weights in FP16 or BF16, where each weight occupies 16 bits. Weight-only quantization converts those parameters to formats such as INT8 (8 bits) or INT4 (4 bits), usually retaining small scale or zero-point metadata so the runtime can reconstruct useful values during computation.

The immediate effect is smaller weight storage and less data moved from GPU memory during inference. The model’s architecture, parameter count and tokenizer do not change, but the representation is less precise. Some runtimes dequantize blocks during matrix multiplication; others use kernels that operate directly on a packed low-bit format.

That distinction explains why a smaller model file is not the same as an equally smaller running process. A serving process also needs activations, temporary workspaces, framework overhead and the key-value (KV) cache used by attention. Quantizing weights does not automatically quantize those other allocations.

Meta’s Llama quantization guidance describes the idealized arithmetic: converting FP16 weights to INT8 cuts weight precision storage by 50%, while FP16 to INT4 cuts it by 75%. Those are best-case calculations for the weight representation, not measured end-to-end GPU-memory savings. Meta explicitly cautions: “Because actual memory savings can be less than the computed savings, you should test for the actual memory usage on real hardware when comparing models.”

How much GPU memory does a quantized LLM need?

Start with a weight-only estimate, then add the memory that inference actually consumes. For a model with P parameters and a target representation of b bits, the idealized weight requirement is:

weight bytes ≈ P × b ÷ 8

For example, 13 billion parameters at 4 bits produce about 6.5 billion bytes (roughly 6.5 GB using decimal units) before scales, metadata, alignment, framework allocations and any non-quantized layers. A real 4-bit deployment therefore needs more capacity than that arithmetic suggests.

Memory components to include

  • Quantized weights: the largest fixed allocation for many single-request workloads.
  • Scales, zero points and unquantized layers: per-group metadata and sensitive layers can consume extra memory.
  • Activations and temporary workspaces: these vary with sequence length, batch size, hidden dimensions and kernel implementation.
  • KV cache: stored attention keys and values grow as prompts and generated sequences become longer, and as more requests share the GPU.
  • Runtime and allocator overhead: the framework, CUDA graphs, communication buffers and fragmentation all reduce usable headroom.

Long-context applications can become KV-cache-bound after weight quantization. A 4-bit model with a short prompt may fit comfortably, while the same model at a long context or high concurrent batch size can run out of memory. KV-cache quantization addresses this cache rather than the model weights; it is a separate choice with its own quality and kernel-compatibility trade-offs.

What the one-GPU examples actually show

A Google Cloud GKE inference guide gives deployment examples in which GPTQ on Llama 2 13B and AWQ on Gemma 7B can be served on one NVIDIA L4 GPU, whereas the corresponding unquantized configurations in those examples used two L4 GPUs. The examples illustrate how reduced weight memory can change placement; they mix different models and are not a same-model benchmark or a universal guarantee that any 4-bit model fits on one L4.

Estimating capacity before deployment

  1. Calculate the idealized weight bytes from parameter count and bit width.
  2. Check the quantizer’s metadata overhead and which layers remain at higher precision.
  3. Reserve memory for the maximum prompt and generation length, not just the average request.
  4. Estimate KV-cache growth for the intended batch or concurrency level.
  5. Leave headroom for the runtime, temporary buffers and allocator fragmentation.
  6. Run the exact model and serving stack while recording peak, not just initial, GPU allocation.

Does 4-bit quantization make an LLM faster?

Sometimes. Lower-precision weights reduce memory bandwidth, and specialized low-bit matrix-multiplication kernels can perform more useful operations per byte transferred. If inference is memory-bandwidth-bound, that can improve token generation or allow a larger batch. If it is compute-bound, or if the runtime repeatedly dequantizes weights with inefficient kernels, the same bit width may provide little benefit or even add overhead.

Meta’s performance guidance says quantized models typically run faster because of reduced memory-bandwidth requirements and low-precision operations, while emphasizing that architecture, hardware and whether the workload is memory- or compute-bound determine the actual result. Measure on the accelerator and software version you will deploy.

Published speed results and their limits

The GPTQ authors reported end-to-end inference speedups over FP16 of around 3.25× on an NVIDIA A100 and 4.5× on an NVIDIA A6000 in their 2022 experiments, while compressing tested GPT models to 3 or 4 bits per weight with negligible degradation against their uncompressed baselines. Those figures belong to the paper’s models, kernels, workloads and hardware; they are not expected speedups for every current serving stack. See the GPTQ paper.

AWQ paper authors reported more than 3× speedup over the Hugging Face FP16 implementation for TinyChat in experiments on desktop and mobile GPUs. This compares that implementation and those tested devices, not all AWQ deployments. The method is described in the AWQ paper.

Measure the right latency metric

  • Time to first token (TTFT): how long a user waits before generation starts; prompt processing and scheduling dominate it.
  • Decode latency or tokens per second: the pace after the first token, often sensitive to memory bandwidth and KV-cache access.
  • End-to-end latency: total time for the complete response, including queueing and all generated tokens.
  • Throughput: requests or tokens per second at a stated concurrency. Larger batches can raise throughput while increasing each request’s latency.

KV caching normally accelerates autoregressive generation by avoiding repeated computation, but the cache consumes additional memory. A quantized model can therefore have excellent single-request token speed yet lose throughput at the context length or concurrency your service requires.

Runtime and kernel support can dominate the result

Bit width alone does not select an implementation. The serving framework must recognize the file format, map it to kernels for your GPU generation and handle operations that remain at higher precision. The vLLM quantization documentation lists supported formats and hardware combinations and warns that its compatibility chart changes as the project evolves. Pin the runtime version used in testing, then verify the current table before upgrading or moving to another accelerator.

How low-bit quantization affects LLM accuracy

Quantization introduces approximation error into weights. The practical impact depends on the bit width, calibration data, layer sensitivity, model architecture, quantizer and task. A model can retain broad language fluency while losing reliability on arithmetic, code, factual retrieval or long chains of reasoning. Aggregate benchmarks may hide a failure mode that matters to your application.

Why published results disagree

The GPTQ paper reported negligible accuracy degradation for its evaluated 3- and 4-bit configurations relative to uncompressed baselines. That is evidence that the method can preserve quality under those experimental conditions, not proof that every model or prompt is equally robust.

In contrast, a 2025 study of AWQ and GPTQ on Llama 3 mathematical-reasoning tasks reported up to 32.39% accuracy degradation, with an average degradation of 11.31% in its tested settings. The authors focused on numerical computation and reasoning planning; their results should not be generalized to all models, datasets or quantization recipes. Read the study at arXiv:2501.03035.

The safe conclusion is conditional: low-bit weights may preserve quality for one workload and damage a critical capability in another. Validate the actual prompts, output constraints and error costs before deployment.

Tasks that deserve extra scrutiny

  • Multi-step mathematical reasoning and numerical calculations.
  • Code generation where a small token error breaks execution.
  • Structured output with strict schemas or exact formatting.
  • Long-context retrieval, where quantized weights and a large KV cache interact.
  • Safety, policy or classification decisions where false positives and false negatives have different costs.

GPTQ, AWQ, mixed precision and KV-cache quantization compared

These approaches optimize different parts of the inference problem. There is no universal winner; the right choice is the one that meets your quality and serving constraints.

Approach What it quantizes or changes Typical rationale Important qualification
GPTQ Primarily model weights, using a one-shot method based on approximate second-order information. Strong compression at 3–4 bits with published speed and quality results. Results depend on calibration, model, kernels and hardware; paper figures are not universal.
AWQ Weight-only quantization that uses activation statistics to identify salient channels and apply scaling. Activation-aware, hardware-friendly deployment and efficient low-bit kernels. Quality and speed vary by model, runtime and device; TinyChat results are implementation-specific.
Mixed precision Different layers or tensor groups receive different bit widths. Keep sensitive layers at higher precision while compressing less sensitive layers. It is a possible accuracy-size compromise, not a guaranteed improvement; test the selected scheme.
KV-cache quantization Attention keys and values accumulated during inference, rather than the model’s weights. Reduce cache growth for long contexts or larger batches. It addresses a different memory consumer and can introduce its own quality and compatibility effects.

The LLM Compressor algorithm-selection guidance recommends choosing with accuracy requirements, quantization scheme, model, hardware and algorithm compatibility in mind. Use those criteria rather than selecting a format solely because it has the smallest file.

A repeatable benchmark for accuracy, speed and memory

Comparisons are meaningful only when the variables other than quantization are controlled. Use this sequence for each candidate bit width or algorithm:

  1. Freeze the workload: use the same model revision, tokenizer, prompt template, sampling settings, context lengths, output limits and concurrency.
  2. Freeze the platform: record GPU model, available memory, driver, CUDA stack, serving framework and exact runtime version.
  3. Establish a baseline: run FP16, BF16 or another higher-precision configuration with the same prompts and measure quality, peak memory, TTFT, decode speed, end-to-end latency and throughput.
  4. Measure peak memory: test the longest intended context and largest production batch, including KV-cache allocation. Do not infer this from the quantized file size.
  5. Score representative tasks: include ordinary requests and failure-sensitive cases such as arithmetic, reasoning, code or structured output. Track task-specific accuracy or exact-match metrics, not only a general language score.
  6. Check operational behavior: verify loading time, unsupported operations, out-of-memory errors, numerical instability and any fallback to slower kernels.
  7. Stress concurrency: increase simultaneous requests until latency or memory violates your service target, recording throughput and per-request latency separately.
  8. Repeat after upgrades: a new driver, GPU, model conversion or serving-framework release can change kernel selection and compatibility.

What to change when a quantized deployment fails

The model does not fit

First reduce context length or concurrent batch size to determine whether the KV cache, rather than the weights, is the limiting allocation. If the cache is responsible, evaluate KV-cache quantization or a serving policy that limits maximum sequence length. If weights dominate, move from FP16 to INT8 or INT4, select a smaller model, or use mixed precision. Re-measure peak memory after every change.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Quality is below the application threshold

Try a less aggressive bit width, a different quantizer, better calibration data or mixed precision that protects sensitive layers. Keep the task evaluation fixed so an apparent improvement is attributable to the configuration. Do not assume that moving from one 4-bit format to another restores quality without testing.

Generation is no faster

Confirm that the runtime selected low-bit kernels for your exact GPU and that it did not silently dequantize to a higher-precision path. Profile TTFT and decode separately, then test batch sizes that resemble production. If the workload is compute-bound, lower memory traffic may not matter; if it is launch- or scheduling-bound, kernel overhead can erase the theoretical gain.

The runtime rejects the model or uses an unsupported operation

Check the serving framework’s current quantization and hardware matrix, including the version you have installed. A format supported on one GPU generation may be unavailable or slower on another. Convert the model with a documented toolchain, pin compatible versions and rerun the full benchmark after any conversion.

Choosing a bit width for a real application

Use the highest compression that meets your measured quality and service targets, not the lowest number advertised. INT4 is attractive when GPU memory is the primary constraint and the model remains accurate on your tasks. INT8 or mixed precision can be the better compromise when numerical reliability, code correctness or strict structured output matters more than maximum compression. For long-context services, account for KV-cache strategy independently of weight precision.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Document the complete configuration: model revision, quantization algorithm, calibration set, bit widths by layer, runtime version, GPU, context and batch limits, and benchmark results. That record makes future hardware or software changes reproducible and prevents a paper’s speedup or accuracy figure from being mistaken for a production guarantee.

In practical terms, low-bit quantization is a three-way trade: smaller weights can improve placement and sometimes speed, while approximation can reduce task quality and the remaining runtime allocations can still determine capacity. A workload-specific measurement of quality, peak memory, TTFT, latency, throughput and compatibility is the only dependable basis for deployment.
