AI detects payment fraud by scoring each transaction, account and relationship against expected behavior. It combines transaction history, device and authentication context, KYC data, investigator findings and network links, then returns a risk score that can trigger approval, step-up authentication, a delay, a block or human review. Effective systems do not rely on one “AI model”: they layer rules, machine-learning models, graph analytics, authentication and investigation workflows.
What AI fraud detection actually does
Digital-payment fraud detection is a risk-estimation problem. A system asks whether a payment is consistent with the customer, account, beneficiary, device, merchant and wider payment network. It does not prove that a payment is criminal. Instead, it estimates risk quickly enough for a bank, card issuer, payment processor or wallet provider to choose a response.
“AI” in production generally includes three analytical families:

- Anomaly detection: models identify behavior that departs from an account’s normal pattern when confirmed-fraud labels are scarce or an attack is new.
- Graph and network analytics: models examine links among accounts, beneficiaries, devices, merchants and transfers to reveal coordinated activity that looks harmless one transaction at a time.
The Bank for International Settlements (BIS) describes machine learning as a way to “find needles in the haystack” of payment data. Its 2025 Annual Economic Report says models can use account and transaction behaviour, know-your-customer (KYC) information and investigator-identified information to produce explainable detections and reduce false positives.

Fraud detection is related to, but not identical with, anti-money-laundering (AML) monitoring. Fraud controls focus on preventing or recovering an unauthorized or deceptive payment. AML controls investigate the movement or concealment of criminal proceeds under different legal obligations. The data and graph techniques overlap, but the case decisions, reporting duties and retention rules differ.
What data an AI model uses
A payment rarely receives a decision from its amount alone. Feature-building systems turn raw events into signals that describe the payment, the account and its relationships.
Transaction and account behavior
- Amount, currency, merchant category and payment rail.
- Velocity: the number and value of payments over short and long windows.
- Time of day, day of week and deviation from the customer’s normal schedule.
- Account age, tenure, balance behavior and historical payment patterns.
- Beneficiary history, including whether the recipient is new or recently changed.
Authentication and channel context
- Login, device, browser, app, session and network characteristics.
- Whether the payment was initiated in a familiar channel or after an abrupt channel change.
- Authentication method and result, including whether a strong-authentication challenge was completed.
- Signals of credential compromise, such as an unusual device or rapid changes to contact details.
Identity, geography and relationships
- KYC attributes and investigator-identified information.
- Geographic inconsistencies, including an impossible sequence of locations or a sudden country change.
- Links to other accounts through shared devices, addresses, beneficiaries, merchants or transaction paths.
- Patterns that connect many apparently unrelated accounts to the same mule-account or cash-out network.
These features are usually transformed, combined and time-windowed before scoring. A new beneficiary may be low risk for a long-standing customer who has made similar transfers, but high risk when it appears alongside a new device, unusual velocity and a password reset.

How a layered detection stack works
1. Collect events and build features
Payment, login, account-change, KYC and investigation data are ingested into a decision system. Features are calculated in real time for an immediate payment decision and in batches for trend analysis. Data minimization matters: Project Hertha, a BIS experiment announced on 5 June 2025, treats privacy and use of the minimum necessary data as design constraints.

2. Apply deterministic rules
Rules handle known patterns and mandatory policy controls. Examples include a prohibited geography, an impossible transaction sequence, a blocked account or a velocity threshold. Rules are fast and easy to explain, but they can miss a new pattern and become brittle when criminals alter amounts, timing or channels.
3. Score with machine-learning models
Classifiers combine weak signals that are unconvincing individually but persuasive together. Anomaly models compare current behavior with an account’s baseline or a peer group. A model may output a probability-like risk score, a ranked set of contributing features or both. Scores are calibrated to the organization’s tolerance for fraud losses and customer friction.
4. Add network and graph analysis
A graph represents accounts, devices, beneficiaries, merchants and payments as connected nodes and edges. It can reveal many accounts sending to one beneficiary, a device operating a cluster of accounts, or funds moving through a repeated chain. BIS Project Hertha tested AI techniques for complex, coordinated criminal activity in real-time retail-payment data and emphasized that criminals operate across multiple institutions. Network-wide patterns can therefore expose activity that a single institution cannot see in isolation.
5. Choose an action
The score is mapped to an operational response rather than an automatic accusation:

- Approve with no additional friction when risk is low.
- Request step-up authentication or a confirmation when risk is elevated but uncertainty remains.
- Delay or hold the payment while contacting the customer or checking a beneficiary.
- Decline or block when policy thresholds and evidence justify it.
- Create a case for an investigator when the event is complex or connected to other alerts.
6. Explain and investigate
Investigators need to know why an event was flagged: for example, a new device, unusual velocity and a beneficiary linked to previously confirmed cases. Explainability also helps supervisors identify unfair patterns and tune thresholds. BIS links explainable detections with fewer false positives.
7. Feed outcomes back into monitoring
Customer disputes, confirmed cases, investigator decisions, chargebacks and recovery outcomes become feedback. Teams monitor precision, recall, false-positive rates, decision latency and performance by segment. They retrain or recalibrate when behavior changes. The Federal Reserve’s CardSim research exists partly because public payment data are scarce; its simulator provides a reproducible way to test machine-learning workflows and interpretability under limited-data conditions.
Rules-based checks versus AI models
Most real deployments combine both approaches. The practical differences are shown below.
Quick wins for a faster PC:

|---|---|---|
| Known fraud | Strong when a pattern can be written as a clear condition. | Can learn combinations of known-fraud signals from labeled cases. |
| Novel patterns | Usually requires a human to discover and encode a new rule. | Anomaly and graph methods can surface behavior not previously labeled. |
| Context | Often evaluates a transaction or a small set of fields. | Can combine account history, peer behavior and whole-network relationships. |
| Latency | Typically deterministic and suitable for real-time decisions. | Real-time scoring is possible, while deeper graph and trend analysis may run in batches. |
| Customer friction | Fixed thresholds can create avoidable declines or challenges. | Risk scores allow graduated actions, but poor calibration can still create false positives. |
| Explanation | The triggering condition is usually straightforward to state. | Requires feature attribution, model documentation and investigator-facing reason codes. |
| Privacy and sharing | Can operate within one institution’s data boundary. | Network benefits increase when institutions share signals, but privacy, legal and cross-border limits constrain sharing. |
| Drift and evasion | Attackers can test and work around visible thresholds. | Models can adapt through monitoring and retraining, but adversaries can manipulate data and behavior. |
| Authorized-payment scams | Rules may not distinguish a coerced or deceived customer from a genuine payment. | Behavioral and conversation-independent signals help, but a legitimate customer may still authenticate and make the payment. |
How real-time payment scoring unfolds
- Initiation: a customer submits a card purchase, bank transfer or wallet payment.
- Context assembly: the system retrieves account, beneficiary, device, channel, authentication and recent-activity features.
- Fast controls: policy rules and sanctions or block lists are checked.
- Model scoring: supervised, anomaly and relevant graph models calculate risk.
- Decisioning: the score is compared with action thresholds for approval, challenge, hold, decline or review.
- Customer or analyst response: a step-up challenge, out-of-band contact or investigation may add evidence.
- Final outcome: the payment is released, rejected, delayed or escalated, and the result is logged for monitoring.
Real-time does not mean every analysis is instantaneous or identical across payment rails. A card authorization may have milliseconds for a response, while a bank transfer can support a hold and customer contact. Thresholds and available features must match the rail’s timing and legal requirements.

What AI catches well
- Unusual velocity: a burst of payments or rapid movement through newly opened accounts.
- Profile breaks: an amount, time, location, device or channel that conflicts with established behavior.
- New-beneficiary risk: a first transfer to a recipient combined with other suspicious changes.
- Account takeover indicators: credential changes, unfamiliar devices and payment activity appearing together.
- Coordinated mule activity: shared devices, beneficiaries or transaction paths connecting many accounts.
- Cross-institution relationships: network analysis that reveals patterns unavailable to one institution alone.
These are situations in which repeated behavioral or relationship traces give a model evidence beyond the single payment.

Authorized-payment scams
In impersonation and social-engineering scams, the legitimate customer may pass authentication and approve the payment. The EBA and ECB reported that manipulation of the payer represented more than half of fraudulent-credit-transfer value in 2024. A model can identify unusual context, but it cannot always know that a trusted customer has been deceived.
Credential compromise with familiar behavior
An attacker using a stolen device, session or credentials may imitate normal activity closely enough to evade behavioral thresholds. Layered controls and customer contact remain important.

Confirmed fraud is a small fraction of all payments, so naive training can favor the majority class. Attackers also change tactics, creating concept drift. Monitoring must detect when feature distributions, fraud rates or model calibration change.

False positives and customer harm
A blocked legitimate payment can cause missed bills, lost sales or reputational damage. Organizations need reason codes, appeal and review paths, segment-level testing and thresholds that reflect the cost of both fraud and friction.
Data silos and privacy
Cross-border restrictions, institutional boundaries and data-minimization requirements limit the network view. Sharing more data is not automatically better; governance must specify purpose, access, retention and security.
Authentication helps, but it is only one layer
Strong customer authentication (SCA) has reduced some forms of payment fraud, especially card fraud. The EBA-ECB reports that SCA-authenticated card transactions generally had lower fraud rates. Credit transfers are less straightforward because authentication is often applied to higher-risk or higher-value payments, and an authorized customer can still be manipulated into approving a scam.
For that reason, authentication should be combined with behavioral analytics, beneficiary checks, device intelligence, transaction holds and customer education or contact. Passing a challenge proves that an authentication factor was used; it does not prove that the payment’s purpose is legitimate.
What the latest figures show
Fraud levels and attack patterns vary by region, payment type and reporting method. The following dated figures should not be treated as a universal fraud rate:
| Measure | Reported figure | Scope and date |
|---|---|---|
| Total payment fraud | €4.2 billion | European Economic Area, 2024, EBA-ECB reporting. |
| Fraudulent credit transfers | €2.5 billion; 0.001% fraud rate | EU/EEA, 2024, EBA-ECB reporting. |
| Fraudulent card transactions | €1.3 billion; 0.033% fraud rate | EU/EEA, 2024, EBA-ECB reporting. |
| Fraud prevention and recovery attributed to detection tools including machine-learning AI | More than $4 billion | U.S. Treasury fiscal year 2024, cited by Federal Reserve Governor Michelle Bowman on 22 November 2024; about $1 billion concerned Treasury-check-fraud recovery. |
| Institutions reporting debit-card-fraud attempts | 75%; estimated to represent about 40% of payment-fraud losses | Federal Reserve Financial Services survey conducted in 2025 and reported in 2026. |
These numbers demonstrate why institutions invest in layered analytics, but they do not show that AI alone prevented every listed loss. Federal Reserve Governor Michelle Bowman said on 22 November 2024 that there is already “some evidence that AI tools are powerful in fighting fraud.”
How to design an effective AI fraud program
- Define the decision: specify whether the system protects card authorization, account login, beneficiary setup, transfer release or post-payment investigation.
- Map the data: document available transaction, account, KYC, device, authentication and investigator fields, plus retention and access limits.
- Build layered controls: retain deterministic rules for known threats and policy obligations while adding supervised, anomaly and graph models where they add coverage.
- Set graduated actions: map risk bands to approval, step-up, hold, decline and analyst review rather than treating every alert as a block.
- Make decisions explainable: store reason codes, feature values, model version, rule version and the action taken.
- Measure business harm: track fraud loss, recovery, false positives, customer abandonment, review workload and decision latency together.
- Test for drift and bias: monitor performance by payment rail, geography, customer segment and attack type; investigate sudden changes.
- Protect feedback quality: distinguish confirmed fraud, customer misunderstanding, friendly fraud, authorized scams and unresolved cases before retraining.
- Coordinate externally: where lawful, share timely indicators with other institutions and payment-system participants because coordinated criminals cross organizational boundaries.
Practical limits to keep in mind
- No single model works across every payment rail, geography or fraud type.
- A high score is an investigation signal, not proof of criminal intent.
- More data can improve context but also increase privacy, security and governance obligations.
- Model updates need version control, rollback procedures and monitoring after deployment.
- Customer-contact and recovery processes remain essential for scams that pass authentication.
The strongest architecture is therefore a feedback-controlled system: rules cover explicit risks, models discover combinations and anomalies, graphs expose coordination, authentication adds assurance, and trained investigators handle ambiguity.
