Gaussian processes (GPs) can forecast oil prices or returns by fitting a probability distribution over possible relationships between market inputs and a future target. Their kernel controls which observations the model treats as similar, while the output’s predictive mean and spread summarize a forecast conditional on the fitted model—not a guarantee of market risk or trading profit.
How Gaussian processes forecast oil prices
A Gaussian process places a probability distribution over functions. In regression, observed data update that prior into a posterior predictive distribution. Given inputs such as past returns or other market information, a GP can estimate a target—such as a next-month oil return—and provide a predictive mean and standard deviation.
Unlike a model that returns only one number, a GP therefore offers a distribution of plausible outcomes under its assumptions. Scikit-learn describes Gaussian processes as “a nonparametric supervised learning method used to solve regression and probabilistic classification problems.” Its Gaussian Processes documentation explains the method and its predictive outputs.

The kernel, also called the covariance function, sets how pairs of inputs covary. In practical terms, it encodes what the model considers similar and how quickly that similarity declines as inputs move apart. It shapes the functions the GP can learn, so kernel choice is a modeling assumption—not a neutral setting.

Smoothness and scale
The radial basis function (RBF), or squared-exponential, kernel favors very smooth functions. A Matérn kernel provides a way to control smoothness. Kernel hyperparameters such as length scale describe similarity in the particular feature space and fitted model. They are not universal measures of how long an oil-market pattern will persist.
In a 2025 application to one-year and ten-year CL=F crude-oil datasets, Gebreslasie and SenGupta used a Gaussian kernel to smooth and interpolate observations and estimate uncertainty regions. Their tuned length scale was 7.448797, which they interpreted as correlations decaying over about seven trading days for that dataset and specification. This is a fitted study result, not a general oil-market timescale. The paper describes its method and findings.

What research found for Brent and WTI
Monthly returns with stock-market predictors
A 2022 Axioms study by Yuming Zhu, Dmytro Matsypura, and colleagues compared GP modeling, deep learning, and vine-copula regression for Brent and WTI return forecasting. It used monthly oil and major S&P 500 stock returns from February 2001 through October 2019. In its GP experiment, the authors selected five equity covariates and forecast next-month oil returns from contemporaneous stock information; oil observations from May 2017 through October 2019 were held out for testing.

Smoothing and movement detection
The 2025 CL=F study used GP-derived means as features in a procedure for classifying crash-like movements. The authors reported improved downstream detection accuracy compared with using the original sparse data over the period they studied. That finding concerns the detection task and its data; it does not establish a profitable trading signal.
Other kernel-based and probabilistic approaches
“Kernel method” does not mean “Gaussian process.” A 2024 Journal of Forecasting paper examined a kernel-based generalized random interval multilayer perceptron for interval-valued WTI returns; that is a distinct neural method. The paper’s abstract and publication details identify its approach.

A 2024 Information Sciences article compared deterministic and probabilistic crude-oil forecasts and reported that its optimized Additive-ARIMA-GRU hybrid was statistically superior in its simulations. A separate ensemble study combined prediction intervals from several submodels, including a Gaussian-process regression component. These examples make the case for comparing a GP with relevant alternatives rather than assuming it is the best model. The Information Sciences article and the ensemble study describe those distinct methods.

How to read GP uncertainty
A predictive standard deviation or interval represents uncertainty conditional on the selected kernel, fitted parameters, inputs, and model assumptions. It does not automatically capture every source of uncertainty in oil markets, including regime changes, data quality, execution, liquidity, or the possibility that the model is misspecified. A narrow interval is not proof that the market itself is low-risk.

Scikit-learn’s GaussianProcessRegressor can return predictive means and standard deviations. Its documentation notes that predictive probabilities can be used to calculate empirical confidence intervals and inform decisions such as whether to refit in a region of interest. For trading decisions, however, intervals need to be checked against genuinely out-of-sample outcomes: a stated confidence level is useful only if observed coverage is reasonably consistent with it.
What to compare before using a forecast
Forecast comparisons are meaningful only when the target, horizon, data, and evaluation design are clear. Check the following before treating a GP result as useful trading information:
- Target and instrument: Is the model predicting price, return, volatility, or an interval? Is the series Brent or WTI, and does it represent spot prices or futures?
- Horizon and information set: How far ahead is the forecast, and which predictors are available at the time it would be made? Confirm that feature timestamps do not leak future information.
- Time-ordered evaluation: Use chronological or rolling-origin test periods rather than random shuffling. Fit scaling and feature selection within each training window so that future observations do not influence past predictions.
- Point and probability performance: Compare point errors as well as interval coverage and sharpness, or another appropriate proper probabilistic score. Evaluate whether uncertainty estimates remain calibrated across different periods.
- Baselines and alternatives: Include simple forecasts and credible alternative probabilistic methods. The Brent/WTI study’s overall winner was not its GP setup.
- Trading assumptions: Forecast accuracy is not net trading value. Assess transaction costs, slippage, liquidity, contract roll rules, position sizing, and risk constraints separately.
- Reproducibility: Record data frequency, benchmark or contract definition, feature timestamps, time split, forecast horizon, kernel, and noise settings.
Practical implementation considerations
In scikit-learn, GaussianProcessRegressor optimizes kernel hyperparameters by maximizing log marginal likelihood, an objective that can have multiple local optima. The implementation can represent observation noise with alpha or a WhiteKernel. Results can therefore depend on kernel specification, noise treatment, and optimization choices.
The scikit-learn implementation is not sparse and becomes less efficient as feature dimension grows beyond a few dozen, according to its documentation. This matters when expanding the information set with many market predictors: a model that is interpretable and tractable with a small number of features may become computationally burdensome as inputs grow.
