Choose zero-shot when you have no labeled examples and your taxonomy is exploratory or likely to change. Choose few-shot when a small, carefully selected set of demonstrations can clarify label boundaries and the prompt can accommodate them. Choose fine-tuning when labels are stable, representative training data exists, and recurring volume makes predictable latency and per-item cost worthwhile. Run all three on the same held-out data before making a production decision.

The decision in one view

Text classification assigns one or more labels to an input such as a support ticket, document, message, or review. The three approaches differ in where task knowledge comes from: the labels and model’s prior knowledge (zero-shot), examples placed in the prompt (few-shot), or parameter updates learned from a labeled training set (fine-tuned).

Situation Best starting point Why it fits Main risk
No labeled data; taxonomy is exploratory Zero-shot Starts immediately and labels can be changed without training Unstable boundaries and sensitivity to label wording
About 1–20 good examples per class; rapid iteration Few-shot Adds task context without a training pipeline Prompt length, example selection, and output variance
Stable taxonomy and recurring high volume Fine-tuned encoder or small language model Predictable serving cost and latency after training Data preparation, monitoring, and retraining burden
Broad transfer to unseen tasks Instruction-tuned model Instruction tuning generally improves zero-shot transfer Larger model and serving cost; it is not private-label adaptation
Highest zero-shot quality is the priority Test rerankers and embedding models as well as LLMs Recent benchmark results show important family-level differences Benchmark performance may not transfer to your domain

The table is a starting hypothesis, not a substitute for measurement. Domain vocabulary, class imbalance, document length, language, privacy constraints, and traffic volume can reverse the apparent choice.

What zero-shot, few-shot, and fine-tuned mean

Zero-shot classification

In zero-shot classification, you provide the text, an instruction, and human-readable labels. You do not provide task-specific labeled examples and do not update model parameters. The model must infer the boundary from the label names, their descriptions, and its general training.

This is the fastest way to test a new taxonomy. You can add, remove, or rename labels by changing the request rather than rebuilding a model. The trade-off is sensitivity: changing “billing problem” to “payment issue,” or supplying a more detailed definition, can change predictions even when the input is identical. Model priors may also favor a plausible interpretation that does not match your organization’s policy.

Few-shot classification

Few-shot classification places a small set of labeled input-output demonstrations in the prompt. The model still receives no gradient updates; it learns the task behavior in context for that request. The OpenAI GPT-3 report describes this explicitly: “For all tasks, GPT-3 is applied without any gradient updates or fine-tuning, with tasks and few-shot demonstrations specified purely via text interaction with the model.” GPT-3 was evaluated at 175 billion parameters in that 2020 work.

Demonstrations make implicit boundaries concrete. A pair of examples can show that a password-reset request belongs to “account access,” while a chargeback request belongs to “billing,” even if the names alone are ambiguous. Few-shot remains easy to retarget, but every example consumes context tokens. Selection, ordering, class balance, and contradictory examples can materially affect results.

Fine-tuned classification

Fine-tuning updates model parameters using task-labeled data. The resulting model internalizes the label mapping, so each request normally needs only the input and a compact inference instruction. After training, latency and per-item inference cost are generally more predictable than repeatedly sending long demonstration prompts.

Fine-tuning introduces a lifecycle: define the schema, clean and split data, train, evaluate, monitor production behavior, and retrain when the taxonomy or traffic changes. It can also overfit noisy labels or a narrow time period. A fine-tuned model is not automatically better than a prompted larger model; the relevant comparison is on your held-out data under matched conditions.

Instruction tuning is not private-label fine-tuning

Instruction tuning is a prior training stage performed by a model provider. It teaches a general model to follow task descriptions across many tasks; it does not teach your private categories unless your data was included in that training.

Google Research reported in 2022 that FLAN instruction tuning on more than 60 instruction-described tasks substantially improved zero-shot performance on unseen tasks and outperformed few-shot GPT-3 on several named benchmarks. The reported FLAN model had 137 billion parameters. Treat this as evidence about transfer behavior, not a guarantee for your support queue or document set.

Up-front engineering Lowest Moderate prompt design and example curation Highest: data, training, deployment, and monitoring
Best economic shape Experiments and low or irregular volume Rapid iteration and moderate volume High recurring volume after the training cost is amortized

Choose by your operating situation

You have no labels yet

Start with zero-shot. Write a short definition for every class, include an explicit instruction for single-label or multilabel output, and record the exact model version and prompt. Use the first predictions to discover overlap, missing classes, and examples that human reviewers disagree about. Do not treat those unreviewed predictions as ground truth.

Your taxonomy is still changing

Zero-shot is usually the least disruptive, while few-shot is useful when reviewers can supply a small set of authoritative examples for each boundary. If categories are renamed weekly, a fine-tuned model can become stale faster than its training process can keep up.

You have a small, trusted seed set

Few-shot is a practical bridge. The decision matrix uses “about 1–20 good examples per class” as an iteration scenario, not as a universal threshold. Select examples deliberately: include ordinary cases, borderline cases, and each language or channel that matters. Keep a separate held-out set so the same demonstrations are not used to claim accuracy.

You process a stable stream at high volume

Evaluate fine-tuning an encoder or small language model. A shorter inference request and predictable compute can outweigh the initial labeling and training work. Keep a zero-shot or few-shot baseline in the bake-off; the 2024 evidence below shows that a smaller fine-tuned model can beat a much larger prompted model.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

You need to add a new label tomorrow

Zero-shot and few-shot can add a label by editing the label list and, for few-shot, adding demonstrations. A fine-tuned model can only recognize the new class reliably after it has been trained and validated with examples for that class. A temporary prompted route can cover the gap, but measure it separately and define when traffic returns to the trained model.

You classify sensitive or private text

Privacy and deployment constraints are decision criteria, not afterthoughts. Determine whether text may leave your environment, whether a hosted model is permitted, and what logging or retention applies. If an external prompt is unacceptable, compare locally deployable fine-tuned, embedding, reranking, or instruction-tuned options under the same evaluation protocol.

Build a fair bake-off before committing

Comparisons are meaningful only when preprocessing, label definitions, test data, and scoring are held constant. Use this sequence:

  1. Freeze the schema. Write the label names, definitions, inclusion and exclusion rules, and whether each input may receive one label or several. Version this document.
  2. Create a representative held-out set. Sample across classes, channels, languages, document lengths, time periods, and known edge cases. Do not let demonstrations or training records leak into it.
  3. Run zero-shot. Keep the instruction, label wording, model version, decoding settings, and output parser fixed. Save raw outputs as well as parsed labels.
  4. Run few-shot with a documented selection rule. For example, select a fixed number of reviewed examples per class using a reproducible similarity or stratified-sampling method. Do not hand-pick new examples after seeing test results.
  5. Train a fine-tuned candidate. Use the same input normalization and label policy. Separate training, validation, and held-out test data by time or source when leakage is a concern.
  6. Measure quality and operations together. Report macro F1, per-class recall, calibration or abstention behavior, latency, and cost. Include multilabel metrics when applicable.
  7. Stress the failure modes. Test class imbalance, long documents, ambiguous labels, spelling variation, multilingual inputs, and domain shift. Record where each method fails, not only its average score.
  8. Set a release rule. Define the minimum macro F1 and minority-class recall, maximum latency and cost, acceptable abstention rate, and the conditions that trigger rollback or retraining.

Understand the evidence without overgeneralizing it

The 2024 16-dataset comparison

Edwards and Camacho-Collados’ LREC-COLING 2024 study compares zero-shot and few-shot large-language-model methods with fine-tuned smaller models across 16 datasets covering binary, multiclass, and multilabel classification. Its central practical finding is that “fine-tuning smaller and more efficient language models can still outperform few-shot approaches of larger language models.” This supports a controlled bake-off rather than the assumption that parameter count or prompt size determines the winner.

The 2026 BTZSC benchmark

The ICLR 2026 BTZSC benchmark evaluates 22 public datasets and 38 checkpoints, including NLI cross-encoders, embedding models, rerankers, and instruction-tuned LLMs. Its abstract reports Qwen3-Reranker-8B as the leader with macro F1 of 0.72. Instruction-tuned LLMs in the 4–12 billion parameter range reached macro F1 up to 0.67 and were especially competitive on topic classification.

BTZSC also reports that modern rerankers set a high zero-shot quality bar, embedding models narrow the accuracy gap while offering the best accuracy-latency trade-off, and NLI cross-encoders plateau as backbone size increases. These are benchmark observations on the stated datasets, not production guarantees. Reproduce the comparison on your domain, label policy, languages, and hardware before selecting a model family.

Design better zero-shot and few-shot prompts

Make labels operational

Use names that a reviewer can distinguish, then add one-sentence definitions and an explicit boundary. “Refund request: asks to return a completed purchase” is more actionable than “refund.” State what to do when no label fits, if abstention is supported, and whether multiple labels are allowed.

Select demonstrations for coverage

  • Include representative easy cases so the model sees the center of each class.
  • Include reviewed boundary cases that distinguish neighboring classes.
  • Match production language, channel, spelling, and document length.
  • Avoid contradictory labels and near-duplicate examples that overweight one customer or event.
  • Keep the selection procedure fixed when comparing prompts or model versions.

When fine-tuning is worth the burden

Fine-tuning becomes attractive when the same taxonomy is used repeatedly, the label policy is stable enough to encode, and the expected volume makes training and serving economics meaningful. The required investment is broader than a training run:

  • Data quality: labels must be representative, consistently applied, and reviewed for disagreement.
  • Coverage: include minority classes, rare but costly errors, new product variants, and realistic noise.
  • Evaluation: retain a time-separated or source-separated test set and monitor per-class behavior.
  • Operations: version the model and schema, define rollback, and watch latency, abstentions, and drift.
  • Retraining: schedule a review when labels, language, traffic mix, or privacy requirements change.

There is no defensible universal example count at which fine-tuning suddenly becomes correct. Use the held-out curve of quality, cost, and operational effort. A few clean examples may clarify a prompt; they are not automatically enough to represent every production condition for training.

Cost, latency, and accuracy trade-offs

Zero-shot usually has the lowest setup cost but may require a larger model or repeated prompt iteration. Few-shot adds token cost and can increase latency because demonstrations travel with each request. Fine-tuning shifts work earlier: data preparation and training first, then generally shorter and more predictable inference requests.

Measure total cost per correctly handled item, not only the model invoice. Include annotation, prompt tokens, retries, parsing failures, human review of abstentions, training runs, hosting, monitoring, and retraining. A method with a lower nominal price can be more expensive if it creates more manual corrections or severe minority-class errors.

Demonstration bias

Symptom: few-shot output follows one unusual example or favors the most represented class. Fix: balance demonstrations, remove contradictions, add boundary cases, and use a reproducible selection rule.

Minority-class collapse

Symptom: overall accuracy looks acceptable while a rare class is almost never predicted. Fix: report macro F1 and per-class recall, add representative minority examples, and define an abstention or human-review path.

Long-document degradation

Symptom: quality falls on transcripts or documents much longer than the examples. Fix: test length buckets, define a chunking or summarization policy, and evaluate the aggregation rule rather than assuming short-text results transfer.

Special offer. See more information about Outbyte and uninstall instructions. Please review EULA and Privacy policy.

Taxonomy drift

Symptom: production performance declines after a policy or product change. Fix: monitor label frequencies and reviewed samples, version the taxonomy, and rerun the three-way comparison when labels, language, traffic mix, or privacy constraints change.

A practical implementation pattern

Zero-shot request

Task: assign exactly one label to the input.
Labels:
- account_access: login, password, or authentication problems
- billing: charges, invoices, refunds, or payment disputes
- technical_issue: a product feature is not working
Return only the label identifier.
Input: {{text}}

The variable is shown inside code so it can be replaced by your application. Keep the prompt versioned and evaluate label definitions separately from model changes.

Few-shot request

Task: assign exactly one label. Return only the label identifier.
Example 1
Input: I cannot reset my password.
Label: account_access

Example 2
Input: The same subscription charge appeared twice.
Label: billing

Example 3
Input: The export button returns an error.
Label: technical_issue

Input: {{text}}

In production, generate the examples from the documented selection rule and keep their order stable during evaluation.

Fine-tuned serving pattern

After training and validation, send the normalized input to the versioned model, validate the returned class identifier, apply the release threshold or abstention rule, and log the model version, schema version, confidence information, and outcome needed for later review. Retraining should be triggered by measured drift or a deliberate taxonomy change, not by a single surprising prediction.

Bottom-line selection rule

Start with zero-shot to learn whether the taxonomy is coherent. Add few-shot demonstrations when reviewed examples can clarify boundaries without making prompts unwieldy. Move to a fine-tuned model when the taxonomy is stable, data represents production, and recurring volume justifies the lifecycle cost. Include embedding and reranking candidates in serious zero-shot evaluations, and let a matched held-out test—not model size, benchmark reputation, or intuition—decide the production route.
