Dust is a research method for pretraining transformer language models without using backpropagation to calculate gradients. Instead, it perturbs layer outputs with Gaussian noise and estimates useful update directions from the resulting changes in loss. The authors report promising comparisons with backpropagation, but they explicitly say Dust is not yet compute-efficient enough to replace it.
How Dust trains a transformer without backpropagation
In ordinary backpropagation, a model calculates how each parameter contributed to the final loss by applying the chain rule through the network. Dust takes a different route: it estimates an error signal from sampled changes to a layer’s activations and the loss those changes produce.
- Perturb layer outputs. Dust adds Gaussian noise to linear-layer outputs independently at each token.
- Measure the loss response. The model runs a forward pass, and the method uses changes in loss to assign rewards to the perturbations.
- Estimate a layer-level error. Reward-weighted noise is averaged to estimate an error signal at the layer output.
- Update the layer weights. Dust combines that estimate with the layer input to form a weight update.
Tokens serve as virtual population members, so the method can evaluate many perturbations in parallel in one forward pass. This is still a structured estimator: Dust does not simply keep random steps that happen to improve performance. Its reward weighting, credit assignment, and interference control are part of the method. Q Labs describes the method in its paper, “Dust: Pretraining Transformers Without Backpropagation.”

The paper reports that Dust was competitive with backpropagation in its transformer-pretraining experiments. The authors say Dust exceeded backpropagation in multiple settings at large population sizes. They also report that their 243-million-parameter model outperformed a model 120 times smaller at most population sizes. These are findings reported by the paper’s authors, not an established general result across models or training tasks. The paper’s results and experimental details are available from Q Labs.
#1 Best Overall
For gradient-estimate alignment, the authors report tests up to 1 billion tokens and say Dust’s estimates aligned more closely with backpropagation as the population grew. That result concerns alignment of estimates; it does not by itself show that Dust is faster or better in every practical training setup.
How to read the efficiency comparison
The authors compare Dust with an implementation of EGGROLL and describe an efficiency advantage of roughly 103–104 from 1 million tokens upward. They identify that comparison as based on extrapolations. It should not be read as a universal, directly measured speedup over backpropagation or as a result that applies to all model sizes and workloads.

Experimental details that shape the comparison
The reported experiments used GPT-style transformers trained on FineWeb with a 4096-token BPE tokenizer. Each batch contained 16,000 tokens: eight sequences of 2048 tokens. Training ran for one epoch with SGD and momentum. The paper says methods shared the protocol, were tuned separately, and used three seeds per experimental cell. Those choices provide context for interpreting the reported losses and compute; results may differ under other data, training schedules, tuning budgets, or architectures. The Q Labs paper describes the setup.

Does Dust outperform backpropagation?
The careful answer is: the authors report that it does in multiple settings in their experiments, particularly at large populations, but the evidence described here does not establish a general win. A sound comparison depends on the model scale, population size and compute budget, held-out test loss, credit-assignment method, and whether efficiency figures are direct measurements or extrapolations.

The paper’s scope also matters. The authors write, “We do not attempt to make it compute-efficient enough to replace backprop today.” They present the work as foundational and leave training new kinds of networks to future work. The results therefore support interest in a different way to estimate updates, not a conclusion that backpropagation is obsolete.

Because Dust estimates update directions from forward-pass outcomes rather than relying on the usual chain-rule calculation, it is relevant to research into zeroth-order optimization. But the reported transformer experiments do not show that it makes training models on phones, using neuromorphic hardware, or deploying on non-differentiable hardware practical. Those possibilities remain speculative rather than demonstrated outcomes of this work.
