An AI proof of concept (PoC) asks “Can this work?” A pilot asks “Does it create value for representative users under controlled, real-world conditions?” Production asks “Can we operate it reliably, securely, compliantly and economically as part of normal business?”
The software may look similar at all three stages, but the evidence, data, users, integrations, controls, support model and tolerance for failure change substantially. A PoC can succeed with a small experiment and synthetic data. A pilot must expose workflow and value risks with safeguards. Production requires an operating service with ownership, monitoring, incident response and a plan for change.
The three stages in one view
The Australian Government Digital Transformation Agency (DTA) describes a PoC as an early, short and budget-constrained experiment; a pilot as a limited real-world implementation; and production as a fully deployed system integrated into business-as-usual operations. Those definitions provide a useful sequence, but the stages are not merely labels for project age. Each is a different evidence standard.

| Dimension | Proof of concept | Pilot | Production |
|---|---|---|---|
| Primary question | Can the concept or technical component work? | Does it work for representative users and create the expected value? | Can it deliver a consistent, compliant service at scale? |
| Definition | Early experimental build testing feasibility; short and budget constrained (DTA guidance, accessed 2026). | Limited, real-world implementation validating value, usability and readiness (DTA guidance, accessed 2026). | Fully deployed system integrated into business-as-usual operations (DTA guidance, accessed 2026). |
| Users | Internal team, stakeholders or a test group. | Real users in a limited or controlled setting. | All intended end users. |
| Data | Often synthetic or limited while privacy and governance risks are assessed. | Live or near-live data with safeguards. | Full live production data under governance frameworks. |
| Success measures | Technical feasibility, functional performance and scientific or empirical test metrics. | User satisfaction, feedback and impact on business operations. | Operational performance, business measures and ongoing monitoring. |
| Integration | Minimal, stand-alone, mocked or simulated. | Partial or controlled integration with legacy systems or cloud services. | Full enterprise integration. |
| Governance and risk | Light-touch and risk based. Failure is acceptable when assumptions are explicit. | Increased oversight, ethics and assurance, with stronger controls for sensitive data. | Full compliance, procurement and audit standards, incident management and low tolerance for unmanaged failure. |
| Investment | Low. | Medium, including infrastructure, governance and partial training. | High, including enterprise infrastructure, full compliance, support and long-term sustainability. |
Moving rightward in the table does not mean a model must become more sophisticated. A simple classifier can require production-grade controls if it influences customer access, payments, safety or regulated decisions. Conversely, a technically advanced model may remain a PoC if nobody has shown that it solves a real business problem.

What a proof of concept is—and is not
The purpose is feasibility
A PoC isolates a risky assumption and tests it quickly. The risk might be whether a model can extract fields from documents, classify incoming requests, generate a useful draft or connect to a required data source. The deliverable is evidence about that assumption, not a promise of a deployable product.
Scope and users
Keep the use case narrow enough to explain what was tested. A small internal team, subject-matter experts or a designated test group can provide inputs. Their feedback is useful for discovering technical problems, but it does not establish that a broader population will find the system useful or safe.
Data and environment
Limited or synthetic data is common at this stage because the team is still assessing privacy, security and governance risks. A stand-alone notebook, mocked API or isolated development environment can be appropriate. Record where the sample came from, what it excludes and which assumptions would change when live data is introduced.

PoC metrics should answer the technical question: for example, whether the component performs a defined function, meets an agreed test threshold or integrates with a required interface. Capture the test set, evaluation method, known edge cases and failure examples. A favorable technical score does not prove cost savings, user adoption or regulatory acceptability.
Governance at this stage
Use proportionate controls rather than no controls. Identify data sensitivity, restrict access, avoid placing confidential information into an unapproved service, and document who owns the experiment. The DTA characterizes PoC governance as light-touch and risk based: failure is acceptable when assumptions and consequences are explicit.
The PoC exit package
Before asking for a pilot, produce a short decision package containing:
- A written hypothesis and the user or business problem it addresses.
- The tested workflow, data sources, exclusions and technical dependencies.
- Measurable success criteria and results, including failure cases.
- A data-quality, privacy and security assessment appropriate to the information used.
- An estimate of what must be built, integrated, governed and funded next.
- A named business owner and a named technical owner.
- A recommendation to proceed, revise the hypothesis or stop.
The gate from PoC to pilot
Do not promote an experiment merely because a demonstration looks impressive. The transition should show that the idea is testable in the real workflow and that the organization can learn safely from a controlled exposure.
Do these 3 things before closing this tab:
1Scan for outdated or missing drivers - takes under a minute2Clear out junk files and repair common Windows errors3Fix the driver behind crashes, sound loss and screen glitches1. Define a falsifiable value hypothesis
State who will use the system, which task it changes and what improvement would justify continuing. “Users like the assistant” is too vague. A useful hypothesis connects a user group and workflow to an observable outcome, while acknowledging quality, safety and cost constraints. Set a threshold before the pilot starts so that positive anecdotes cannot replace a decision rule.
2. Re-test on representative tasks
A working demonstration should cover the situations the pilot users actually encounter, including difficult and low-quality inputs. Separate curated examples used for development from a held-out evaluation set. Document cases the model cannot handle and define what the user should do instead.

3. Verify data availability and quality
Confirm that the pilot can obtain the required data legally, reliably and at the needed freshness. Check missing values, inconsistent labels, access permissions, retention rules and the possibility that training or retrieval data contains personal or confidential information. AWS guidance for the Experiment stage specifically calls for verifying data availability and establishing an initial governance framework.
4. Assign cross-functional ownership
Include the people who understand the workflow, data, security, legal or compliance obligations, technology and change management. A pilot without a business owner tends to optimize a technical metric while nobody accepts responsibility for the outcome. A technical owner should be able to explain dependencies, limits and recovery steps.

5. Design bounded exposure
Choose a limited user group, business unit, geography or transaction type. Decide what the model may do automatically and what requires human review. Set a stop condition for harmful outputs, unacceptable error rates, privacy incidents, service instability or excessive cost. A bounded pilot makes failure informative rather than disruptive.
6. Establish the initial control set
Define access controls, logging, data handling, approval responsibilities and an escalation route. Sensitive data may require stronger safeguards before any live test. The controls do not need to equal the final production design, but they must be sufficient for the pilot’s risk and documented so they can be strengthened.
What changes during a pilot
Real users and real workflow pressure
A pilot uses representative users in a limited or controlled setting. Observe how people interpret outputs, how long the task takes, when they override the system and what workarounds they invent. Usability problems often appear only when the tool is embedded in a busy process rather than demonstrated in isolation.
Live or near-live data with safeguards
Use data that reflects operational conditions while applying least-privilege access, masking or redaction where appropriate, retention limits and clear rules for secondary use. Keep a record of which data is used for inference, evaluation, feedback and any later tuning. If production records cannot be used, explain how the substitute data represents them and what uncertainty remains.
Controlled integrations
Connect only the systems needed to test the workflow. A read-only connection, staged queue or approval step can reduce risk while revealing integration issues. Test authentication, timeouts, retries, duplicate events, malformed records and dependency outages. A pilot should expose these problems before they become enterprise incidents.
Broader success measures
Pair model-quality measures with user and business measures. Collect structured feedback, task completion outcomes, escalation rates, rework, cycle time, adoption and operational impact. Interpret results by user segment and task type; an average can conceal a serious failure for a small but vulnerable group.
Increased assurance
The DTA describes pilot governance as involving increased oversight, ethics and assurance, with stronger controls for sensitive data. Review foreseeable harms, explainability needs, human accountability, accessibility and the consequences of incorrect or unavailable outputs. Record decisions and unresolved risks rather than treating approval as a one-time meeting.

What a pilot must produce
- Evidence against the pre-declared value and quality thresholds.
- Feedback from representative users, including rejected or overridden outputs.
- Observed failure modes, data issues and integration defects.
- A cost and capacity profile under realistic usage.
- Security, privacy, legal, compliance and ethical findings.
- A production architecture and operating model, or a documented reason to stop.
The gate from pilot to production
Production is justified when the solution has met agreed value and quality thresholds and the organization is prepared to operate it as a service. AWS describes preproduction as hardening, testing and derisking for reliability, security, compliance and enterprise viability. Microsoft guidance recommends separating sandbox experimentation from production-catalog review and enforcing governance policies and monitoring as deployments mature.
Value and quality evidence
Compare pilot results with the thresholds approved at the start. Include quality by important segment, not only a single aggregate score. Explain residual errors, the human role, expected benefits and the cost of operating the system. If value depends on behavior change, show that users can and do follow the new workflow.
Security and privacy review
Verify identity and access management, secrets handling, encryption, network boundaries, vulnerability management, logging and data retention. Confirm that vendors and subprocessors meet organizational requirements. Review prompt or input-injection risks, unauthorized data disclosure, model extraction, abusive use and unsafe generated content where relevant.
Compliance and audit readiness
Map the use case to applicable laws, sector rules, contractual duties and internal policies. Preserve the records needed to explain data provenance, model and prompt versions, approvals, evaluation results, incidents and material changes. Production approval should identify who can authorize a release and who can suspend the service.
Realistic load and resilience
Test expected concurrency, peak demand, latency, rate limits, dependency failures and recovery. Establish capacity limits and behavior when a model, data source or downstream system is unavailable. Reliability is not demonstrated by a successful single demonstration; it is demonstrated by predictable behavior under conditions the business must handle.

Enterprise integration
Complete the interfaces, event handling, authorization and data contracts required by surrounding systems. Test reconciliation, duplicate messages, partial completion and rollback of side effects. Integrate with the organization’s service desk, asset inventory, change control and incident-management processes.
Support and accountability
Name the service owner, on-call or escalation path, first-line support and specialist responders. Write runbooks for common alerts, degraded operation, unsafe output, data-quality failures and rollback. Train users and support staff on capabilities, limitations and the required human review.
Monitoring and rollback
Define dashboards and alert thresholds for technical health, quality, safety, usage, cost and business outcomes. Keep a known-good model or configuration and a tested rollback procedure. Approval should cover not only launch but also how updates are evaluated and reversed.
What production adds
Business-as-usual integration
In production, all intended users can encounter the system and its outputs can affect normal transactions. The service must fit established processes for identity, procurement, change management, records, support and continuity. A manual workaround should exist for critical functions when the AI service is unavailable or unreliable.

Full governance and low tolerance for unmanaged failure
The DTA characterizes production as requiring full compliance, procurement and audit standards, incident management and low tolerance for unmanaged failure. Controls should be enforceable, not merely documented. Logs must support investigation without exposing more sensitive data than necessary.
Economics and sustainability
Track infrastructure, model, storage, data-transfer, review and support costs. Set budgets, quotas or chargeback rules where appropriate. Reassess whether the achieved business value still exceeds the complete operating cost as usage grows, models change or a lower-cost approach becomes available.
Change management
Version the model, prompts, retrieval sources, policies, features and dependencies that can alter behavior. Evaluate updates against the same quality, safety and fairness criteria used for launch, plus new cases discovered in operation. Use staged releases, canaries or shadow evaluation when the risk justifies them.
Independent reader supportYour contribution helps us test, update, and keep practical guides available for everyone.Production is a continuous operating lifecycle
Launch is the start of operation, not the end of evaluation. AWS’s GLOE framework describes production as deployment and continuous operations: teams collect feedback, monitor performance, run shadow tests where appropriate, follow rollback strategies, deploy iteratively, manage governance and security risks, allocate costs and validate scaling.
Monitor for drift and changing expectations
Data drift occurs when incoming data changes; concept drift occurs when the relationship between inputs and outcomes changes. User expectations, policies, products and external conditions can also shift. Monitor input characteristics, output quality, human overrides, incident trends and business KPIs. Define how much change triggers investigation, re-evaluation or retraining.
Close the feedback loop
Give users a clear way to report incorrect, unsafe or confusing outputs. Triage reports, preserve enough context to reproduce the issue and distinguish model defects from data, integration or workflow problems. Feed validated findings into evaluation sets and release decisions rather than silently changing behavior.
Operate incidents and rollback
Classify incidents by severity and define notification, containment, investigation and recovery responsibilities. A rollback may mean restoring a prior model, disabling an automated action, routing work to humans or disconnecting a data source. Test the procedure; an untested rollback is an assumption, not a control.
Review the service periodically
NIST assigns deployment actors responsibility for piloting, checking compatibility with legacy systems, ensuring regulatory compliance, managing organizational change and evaluating user experience. Its 2023 guidance treats operation and monitoring as continuing lifecycle tasks. Schedule reviews of performance, access, costs, risks, user impact and the continuing business case.

PoC
The team tests whether a model can assign a draft category and priority to a small, de-identified sample of support messages. It measures classification performance on a held-out set, records ambiguous messages and uses a mocked ticketing interface. No ticket is changed automatically. The result is evidence about feasibility, not proof that customers will receive better support.

Pilot
A limited support group receives suggestions on live or near-live messages under access and privacy safeguards. Agents approve, edit or reject every suggestion. The team measures acceptance, rework, handling time, escalation, user feedback and errors by message type. The assistant writes to a controlled test queue and has a documented stop condition.
Production
After security, compliance, load, integration and value reviews, the assistant is connected to the supported ticket workflow for all intended teams. It has an owner, runbooks, monitoring for quality and latency, budget controls, incident escalation and a tested fallback to manual triage. Model or policy changes go through evaluation and release control.
Common mistakes and how to correct them
Calling a demo a pilot
Symptom: A polished demonstration is presented as evidence of readiness. Correction: Test representative tasks with representative users and pre-declared measures under controlled conditions.
Using PoC metrics to claim business value
Symptom: Accuracy or a successful API call is treated as proof of savings or adoption. Correction: Add workflow, user and business measures during the pilot.
Skipping data and privacy checks
Symptom: Sensitive records are copied into an unapproved experiment or live data is assumed to be available. Correction: verify availability, quality, permissions, retention and handling before the pilot.
Expanding users without expanding controls
Symptom: More people receive access while logging, review and escalation remain at PoC level. Correction: Increase oversight and safeguards in proportion to exposure and sensitivity.
Leaving integration until launch
Symptom: The model works in isolation but fails on authentication, timeouts, duplicate events or downstream errors. Correction: Use controlled integrations in the pilot and test failure paths before production.

Who decides whether to advance?
Advancement should be a joint decision rather than a model team’s unilateral sign-off. The business owner confirms that the problem and value case remain real. The technical owner confirms reliability, integration and maintainability. Security, privacy, legal, compliance, risk and procurement functions confirm applicable controls. Operations and support confirm that people, runbooks and escalation paths exist. Users or their representatives confirm that the workflow is usable and that human accountability is clear.
For each gate, record the evidence reviewed, thresholds met, residual risks, named owners, conditions of approval and the next review date. A decision to stop or return to an earlier stage is a valid outcome when evidence is insufficient.
The practical rule
Use a PoC to reduce uncertainty about whether an AI idea can work. Use a pilot to learn whether it works for real people and produces value without unacceptable harm. Move to production only when the organization can integrate, govern, support, monitor and economically sustain the service. Once launched, continue evaluating it because data, behavior, dependencies and expectations change.
