The best production setup combines complete request tracing with measurable answer quality. Capture one request tree that includes model calls, retrieval, tools, and application logic; record latency, tokens, cost, errors, and privacy context; then evaluate the resulting answers with code checks, model-based evaluators, and human labels. Use those real production traces to build regression datasets before changing prompts, models, or agent workflows.
No single platform is best for every team. LangSmith is a natural fit for LangChain and LangGraph applications, Langfuse suits teams that want MIT-licensed self-management, Phoenix emphasizes open-source OpenTelemetry/OpenInference tracing and evaluations, Arize AX targets managed enterprise operations, and Datadog is most compelling when it must share an operational surface with an existing Datadog estate.
What AI observability must show in production
An LLM request is rarely just one API call. A useful trace follows the complete path from the user request through routing, retrieval, prompt assembly, model calls, tool invocations, retries, post-processing, and the final response. Phoenix describes a trace as a record of these connected operations; NVIDIA’s telemetry guidance likewise includes agent execution, LLM calls, tool invocations, and token usage.
Without that request tree, an incident report can tell you that an answer was slow or wrong but not whether the cause was a slow vector search, a repeated tool call, a provider timeout, a changed prompt, or a model response that failed validation. Preserve a trace or session ID and attach the environment, model and provider, prompt version, user or tenant context, and release version to make each run reconstructable.

The minimum trace shape
- Root request: trace ID, session or conversation ID, route, tenant, environment, release, and timestamps.
- Model spans: provider, model name, prompt or template version, generation settings, input and output token counts, latency, finish reason, and errors.
- Retrieval spans: query, retriever or index, returned document or chunk identifiers, ranking metadata, retrieval latency, and filtering decisions.
- Tool spans: tool name, sanitized arguments, result status, duration, retries, timeouts, and exceptions.
- Application spans: routing, guardrails, parsing, validation, caching, business rules, and post-processing.
Store enough content to debug while applying redaction and access controls. LLM and tool spans can contain application content, including personal or confidential data, so observability is also a data-governance decision.
Signals to monitor, and why each matters
| Signal | What to record | Questions it answers |
|---|---|---|
| Latency | End-to-end duration plus per-span duration for retrieval, tools, model calls, and post-processing | Which stage is slow? Are timeouts or retries driving tail latency? |
| Tokens and cost | Input and output tokens per call, aggregated by model, route, tenant, and feature | Which workflows are expensive? Did a prompt or model change increase spend? |
| Errors | Provider errors, exception classes, malformed outputs, retry counts, and timeout details | Are failures transient, validation-related, or caused by a specific dependency? |
| Tool behavior | Tool arguments and results, status, duration, and invocation count | Did the agent choose the right tool, call it repeatedly, or receive an unusable result? |
| Retrieval quality | Retrieved chunks, rank, filters, retrieval latency, context relevance, and groundedness scores | Was the answer based on useful evidence, or did retrieval supply the wrong context? |
| Answer quality and safety | Task-specific correctness, relevance, refusal, safety, policy checks, evaluator version, and human labels | Did the response satisfy the task and policy, not merely return HTTP 200? |
| Drift and regressions | Quality, latency, and cost segmented by model, prompt, workflow, and release | Did a change improve one metric while degrading another? |
| Privacy and governance | Retention, redaction status, access events, and data classification | Can the team investigate safely and meet its data-handling requirements? |
Keep evaluator results at the trace or span level and record the evaluator version with every score. A quality number without its rubric, model, code version, or label context is difficult to compare over time.
Tracing and evaluation are complementary
Tracing explains how a request behaved. Evaluation estimates whether the result was acceptable. Production systems need both. A latency chart cannot reveal that an answer invented a citation, and a correctness score cannot show that retrieval consumed most of the request budget.
Code-based checks
Use deterministic checks where the requirement is explicit: JSON-schema validity, required fields, citation presence, policy keyword rules, tool-argument constraints, latency limits, or an exact-match test for a narrow task. These checks are fast and repeatable, but they only cover properties that can be expressed reliably in code.

Model-based evaluators
For qualities such as relevance, groundedness, or response helpfulness, an evaluator model can score a trace or span against a rubric. Keep the rubric and evaluator model version with the result, and sample borderline or low-confidence cases for review. Evaluator models can disagree with users, so treat their scores as operational signals rather than unquestionable truth.
Human labels
Human review remains important for ambiguous, high-impact, or safety-sensitive outputs. Capture the label, rubric version, reviewer role, and any adjudication result. Human labels can calibrate automated evaluators and reveal failure classes that generic scores hide.
Turn production traces into a regression loop
Real traffic contains the edge cases that hand-written test sets miss. Select representative traces, remove or mask sensitive content, and turn the inputs and expected criteria into a versioned dataset. Replay that dataset after a prompt, model, retrieval, tool, or orchestration change. Compare the same inputs across versions so quality, latency, and cost changes are attributable.
Quick wins for a faster PC:
Fix the driver behind crashes, sound loss and screen glitchesFind Drivers →Repair Windows errors before they cause bigger problemsFix Now →- Collect: sample successful, failed, slow, expensive, and user-flagged traces.
- Sanitize: redact personal, secret, and customer-confidential values before sharing or retaining a dataset.
- Label: add expected answers, acceptable ranges, groundedness criteria, or human judgments.
- Version: record dataset revision, prompt revision, model, evaluator, and code release.
- Replay: run the unchanged inputs against the candidate workflow.
- Compare: inspect quality, latency, token usage, cost, tool behavior, and failure categories together.
- Gate: define release thresholds for critical checks and route ambiguous cases to human review.
This workflow turns observability from a passive log into a controlled iteration system. Phoenix’s datasets and experiments are designed for same-input comparisons; other platforms differ in how deeply this loop is integrated.

Platform comparison
| Platform | Center of gravity | Deployment and integration | Best fit |
|---|---|---|---|
| Arize Phoenix | Open-source tracing, evaluations, prompt iteration, datasets, and experiments | OpenTelemetry and OpenInference; local or self-hosted; broad framework and provider support | Teams that want infrastructure and data control while keeping a debugging-to-evaluation loop |
| Arize AX | Managed, full-lifecycle production observability and evaluation | Managed enterprise platform using the same open standards, with production monitoring and failure discovery | Organizations needing managed operations and enterprise deployment control |
| LangSmith | Framework-native tracing, evaluation datasets, prompt optimization, and collaboration | Cloud-hosted, with especially tight LangChain and LangGraph integration | Teams already centered on LangChain or LangGraph |
| Langfuse | Self-managed tracing, prompt management, and evaluations | MIT-licensed and infrastructure-owned | Privacy-sensitive or self-hosting-first teams |
| OpenTelemetry Collector | Vendor-neutral telemetry routing and enterprise redaction | Routes standardized telemetry to compatible backends; redaction can occur in the collector or export path | Teams standardizing on existing observability infrastructure |
| Datadog Agent Observability | Unified AI, infrastructure, and application observability | OpenTelemetry GenAI semantic conventions plus existing Datadog correlation | Existing Datadog customers wanting one operational surface |
The “best fit” column is a buying framework, not an independent performance ranking. Feature availability, licensing, integrations, pricing, data residency, and enterprise terms change and should be verified for the edition and region you will deploy.
Choosing between the operating models
Open-source and self-hosted
Choose a self-managed service when prompts, responses, tool payloads, or trace metadata cannot leave infrastructure you control, or when you need to determine retention and network boundaries yourself. Phoenix supports local and self-hosted operation, and Langfuse is positioned around MIT-licensed self-management. Budget for deployment, upgrades, storage, authentication, backups, and on-call ownership; “self-hosted” transfers those responsibilities to your team rather than removing them.
Managed enterprise service
A managed platform reduces operational work and can provide centralized access, production monitoring, and failure-discovery workflows. Arize AX is aimed at this model. Confirm where data is stored, whether content can be redacted before export, how long traces are retained, which identity controls are available, and how regional or contractual requirements are handled.
Recommended Free Tools
Telemetry plane plus a backend
An OpenTelemetry Collector can sit between applications and one or more backends. It provides a vendor-neutral routing layer and a practical place to redact sensitive attributes before export. This approach improves portability, but the collector does not replace a quality workflow: you still need a backend or internal service for trace exploration, evaluators, datasets, alerts, and incident review.

How to implement observability without flooding your system
- Define the unit of investigation: decide whether a trace represents one chat turn, an entire session, or an asynchronous job, and use stable IDs consistently.
- Instrument boundaries first: add spans around model calls, retrieval, tools, routing, validation, and post-processing before adding detailed attributes.
- Set a content policy: classify prompts, responses, documents, and tool payloads; redact secrets and personal data at the exporter or collector; restrict access by role.
- Capture cost drivers: record model, provider, input tokens, output tokens, retries, and route so aggregates can be assigned to a tenant or feature.
- Add quality checks: start with deterministic checks, then add evaluator models and targeted human review for the failure modes that matter to the product.
- Create dashboards by workflow: separate retrieval-augmented generation, tool-using agents, and simple completions because their latency and quality baselines differ.
- Alert on actionable conditions: combine thresholds such as tail latency, error rate, cost per successful task, groundedness, or policy-violation rate with a release or model dimension.
- Build the replay gate: maintain a sanitized dataset of representative production inputs and run it before releasing prompt, model, retrieval, or orchestration changes.
Common failure modes and fixes
Only the final model call is visible
Symptom: a trace shows a prompt and answer but no retrieval or tool activity. Fix: instrument each boundary and propagate the same trace context through asynchronous workers and tool clients. Keep application spans so routing and validation decisions are visible.
Telemetry is too expensive or too sensitive
Symptom: teams disable tracing because payloads contain secrets or storage grows uncontrollably. Fix: redact before export, restrict raw-content retention, sample routine successes, retain full traces for failures, and keep aggregate metrics when content is not needed.
High scores hide bad answers
Symptom: an evaluator reports improvement while users still complain. Fix: inspect the rubric, segment by task and tenant, add human labels, and review low-confidence or disagreement cases. Do not treat one evaluator score as a universal quality metric.
Regression tests are disconnected from production
Symptom: a clean benchmark passes but a release fails on real conversations. Fix: continuously promote sanitized, representative production traces into versioned datasets and replay them against every material change.

Cost attribution is impossible
Symptom: an invoice rises but no team knows why. Fix: attach model, route, tenant, feature, token counts, and retry information to every model span, then aggregate by those dimensions.
A practical decision framework
- Choose LangSmith when LangChain or LangGraph is the center of your application and framework-native collaboration is the priority.
- Choose Langfuse when self-management, an MIT license, and control over infrastructure are primary requirements.
- Choose Phoenix when open-source deployment, OpenTelemetry/OpenInference compatibility, and an integrated tracing-and-evaluation workflow matter most.
- Choose Arize AX when you want a managed enterprise service for production monitoring, evaluation, and failure discovery.
- Choose an OpenTelemetry Collector-led design when portability, standardized telemetry, and centralized redaction must fit an existing observability program.
- Choose Datadog Agent Observability when your organization already operates Datadog and wants AI traces correlated with infrastructure and application signals.
Before committing, run a representative trace through the candidate, verify that retrieval and tool spans remain in one request tree, test redaction with real sensitive fields, replay a small labeled dataset, and confirm that the resulting alerts lead an engineer to an actionable failure. Those checks expose operating-model differences that feature lists miss.
Bottom line
Production LLM observability is a feedback system, not a token counter. Instrument the complete request path, measure operational and answer-quality signals together, protect captured content, and replay real traces before shipping changes. Select the platform whose deployment model, framework fit, interoperability, and failure-discovery workflow match the way your team operates.
