Physics-informed AI (PIAI) embeds governing equations, boundary conditions, or conservation laws in model training. Data-driven AI learns a mapping from examples with little or no explicit knowledge of those laws. In semiconductor design, neither is universally better: PIAI is attractive when physics is trusted and labeled data are sparse or expensive, while data-driven models excel at fast, repeated prediction when training data cover the intended operating region. A hybrid model—keeping a TCAD, circuit, or process-physics core and learning a surrogate or correction—often offers the most practical engineering trade-off.
What is the difference?
Consider a device simulator that predicts carrier concentration, electric potential, and current in a transistor. A data-driven neural network receives inputs such as geometry, material parameters, bias, and temperature, then learns to reproduce outputs from previously run simulations or measurements. Its objective is usually a prediction error such as mean-squared error.
A physics-informed neural network (PINN) adds a residual for the equations that should hold even where no labeled output is available. For semiconductor devices, that can include Poisson’s equation and electron and hole current-continuity equations, together with boundary and initial conditions. The training objective can be expressed as:
L = L_data + λ_phys L_physics + λ_bc L_boundary + λ_ic L_initial

L_data measures disagreement with measured or simulated labels. L_physics measures the residual of the governing differential equations at sampled points, and the other terms enforce boundary or initial conditions. The weight λ determines how strongly each requirement influences optimization.
The distinction is therefore not that one model uses a neural network and the other does not. Both can use the same network architecture. The distinction is what constrains learning: examples alone, or examples plus known physical relationships.
Why this matters in semiconductor work
- Device and process equations can be expensive to solve repeatedly, so a learned approximation may support design-space exploration.
- Measurements and high-fidelity TCAD labels are often sparse, noisy, proprietary, or costly to generate.
- Chip-design objectives are coupled. A model that looks good on an intermediate metric can still produce unacceptable timing, power, area, yield, or reliability.
- Signoff requires independently verified accuracy, not merely a low machine-learning loss.
How physics-informed and data-driven models learn
Physics-informed training
A PINN represents the unknown field or response with a differentiable network. Automatic differentiation evaluates derivatives needed by the equations, while collocation points sample the device or process domain. The optimizer reduces equation residuals together with any available labels and boundary constraints.
For a drift-diffusion device model, the residual terms can encode electrostatic potential, carrier transport, recombination, generation, and continuity. For dopant diffusion, the residual can encode how concentration changes with position and time. A 2023 IEEE ACES-China semiconductor study described building a surrogate for a coupled drift-diffusion model with an artificial neural network, computing errors by backpropagation, and updating parameters with Adam.
Because the equations provide information throughout the domain, a PINN can sometimes be trained with sparse boundary or initial-condition data. It can also treat unknown physical quantities—such as a diffusion coefficient or another calibrated parameter—as trainable variables, provided the problem is identifiable and the observations constrain them sufficiently.

Data-driven training
A conventional surrogate is trained on input-output pairs. The labels may come from TCAD, circuit simulation, silicon measurements, layout extraction, or a combination of sources. The model minimizes a prediction objective, then serves predictions much faster than the original simulator for inputs resembling the training distribution.
This approach is straightforward when a team has a large, representative, well-versioned dataset. It is especially useful for repeated evaluations in optimization, yield studies, design-space exploration, and inner loops where running a full solver for every candidate would be impractical.
Hybrid training
Hybrid systems preserve a trusted simulator or analytic component and use machine learning where it adds leverage. Common patterns include:
- Surrogate replacement: train a model to approximate an expensive solver over a bounded operating region, then periodically check candidates with the original solver.
- Residual learning: predict the difference between a lower-fidelity model and a higher-fidelity result rather than learning the entire response.
- Physics-regularized surrogate: add conservation, monotonicity, dimensional, or device-equation penalties to a data-driven objective.
- Differentiable simulation: retain a process or device simulator while exposing gradients for optimization.
- Active learning: use uncertainty or constraint violations to select the next TCAD or measurement points.
These designs avoid forcing a PINN to rediscover well-established numerical methods, while reducing the amount of data needed for a purely empirical model.
Comparison at a glance
| Axis | Physics-informed AI | Data-driven AI | Engineering implication |
|---|---|---|---|
| Primary information | Equations, constraints, and any available labels | Representative input-output examples | PIAI can be useful before a large labeled dataset exists; data-driven methods need coverage. |
| Data requirement | Can reduce dependence on labeled data when equations and boundary conditions are reliable | Usually depends heavily on training-set size and quality | Scarce measurements favor physics-informed or hybrid approaches. |
| Constraint handling | Physics residuals and boundary terms are part of the objective | Constraints must be learned from examples or added separately | Explicit constraints can reduce physically impossible outputs, but do not guarantee correctness. |
| Extrapolation | May behave more plausibly when the encoded laws remain valid | Risk rises outside the training distribution | Neither method should be trusted outside a validated domain without uncertainty and solver checks. |
| Training cost | Residual and derivative calculations can be expensive and difficult to balance | Often simpler to optimize once data are prepared | Benchmark total preparation, training, and validation cost—not inference time alone. |
| Inference | Can be fast after training, although some applications retain iterative physics solves | Usually very fast for repeated predictions | Fast inference is valuable for optimization and sweeps. |
| Interpretability | Assumptions are visible in equations, parameters, and constraints | Behavior is primarily inferred from data and diagnostics | PIAI makes model assumptions auditable; data pipelines can be easier to refresh. |
| Maintenance | Requires updating equations, boundary conditions, and parameterizations as the process changes | Requires new representative data when topology, process, or operating range changes | Version the model with the process design kit, simulator release, and data provenance. |
| Signoff status | Generally research-stage for many semiconductor applications | Useful for exploration and acceleration; signoff requires independent verification | Keep a qualified conventional solver in the signoff path. |
When to choose a PINN or other physics-informed model
Use physics-informed learning when equations are known and trustworthy
PIAI is a strong candidate when the governing relationships are established, the relevant domain and boundary conditions can be specified, and the available labels are limited. Device electrostatics, drift-diffusion transport, and dopant diffusion are examples where the physical formulation supplies useful structure.

Use it when labels are expensive or sparse
Generating a dense training set with high-fidelity TCAD or laboratory measurements can dominate project cost. A physics-informed model can use collocation points and a smaller set of observations, but sparse data do not remove the need to validate against held-out simulations or measurements.

Training a network and a physical parameter together does not guarantee that the parameter is uniquely determined. Check sensitivity, confidence intervals, and whether different parameter combinations produce indistinguishable outputs. Regularization or additional measurements may be necessary.
Do not assume a PINN is automatically easier or faster
PINNs can suffer from competing loss terms, poorly scaled residuals, stiff equations, sharp interfaces, and difficult boundary conditions. Sampling strategy, nondimensionalization, adaptive weighting, and network architecture can determine whether training converges. A conventional numerical solver may still be faster and more accurate for one-off analyses.
When a data-driven surrogate is the better tool
Repeated prediction in a defined operating region
If the team can generate representative samples and the use case involves thousands or millions of evaluations, a conventional surrogate can make optimization practical. Inputs should cover the intended geometry, process corners, voltages, temperatures, loads, and layout conditions—not merely the nominal case.
Objectives that are difficult to express as equations
Placement quality, routing congestion, rule-violation risk, and some yield or reliability outcomes may depend on complex tool behavior and discrete choices. A data-driven model can learn these relationships from prior runs, although it still needs safeguards against invalid candidates.

Fast model refresh from a strong data pipeline
When new simulation or silicon data arrive continuously and the process is well instrumented, retraining can be simpler than reformulating a physical model. The trade-off is that a process change, new topology, or new design regime can invalidate the training distribution.
Device and process simulation versus circuit and physical design
Device and process simulation
In TCAD, the equations often describe fields, carrier transport, thermal behavior, or dopant movement over space and time. Physics-informed methods can exploit this structure and may estimate parameters from limited observations. Evaluation should include device curves, transient response, conservation errors, interface behavior, and performance across process corners.
Circuit-level modeling
At circuit level, the target may be delay, gain, noise, energy, stability, or a transient waveform. A surrogate can be useful inside sizing or optimization loops, but it must be checked over supply, temperature, load, mismatch, and frequency ranges. Equation-based constraints may include current balance, passivity, monotonicity, or known asymptotes.
Placement, routing, and physical design
Physical-design models face discrete actions, legal-placement constraints, congestion, timing, power, and area interactions. The evaluation target is the final design, not only a proxy such as wirelength or a learned score. ChiPBench, a 2024 benchmark, evaluated 20 CPU, GPU, and microcontroller circuits with six AI-based placement algorithms. Its central lesson is that an intermediate metric can appear favorable while final power, performance, and area (PPA) remain unsatisfactory.
Manufacturing and mask-related tasks
Manufacturing introduces masks, layouts, defect data, and process recipes. Generative or differentiable models must preserve hard geometric and process constraints. Physics-informed generative approaches can help, but every candidate still requires design-rule, lithography, process-window, and yield checks appropriate to the manufacturing flow.

Can AI reduce semiconductor simulation time?
It can reduce the cost of repeated evaluations, but the reduction is workload-dependent. A trained surrogate may evaluate candidates quickly, while training requires data generation, optimization, validation, and periodic retraining. A PINN also spends compute evaluating equation residuals and derivatives during training.
Report speed in a way that includes the baseline solver, hardware, number of evaluations, training time, and accuracy threshold. Do not generalize one study’s speedup to all designs. A 2026 computing-in-memory study combined EDA tools, machine learning, and surrogate-assisted multi-objective optimization with SPEA2. It reported mean off-grid normalized errors below 5% across four objectives for that study’s simulation setup; this is not a universal industry benchmark or a guarantee for another process.
A practical speed-accounting method
- Measure the wall-clock cost of the qualified simulator for one evaluation and for the full planned sweep.
- Include data-generation, preprocessing, model-training, hyperparameter-search, and validation time.
- Measure inference time for the actual batch size and hardware used in optimization.
- Count the fraction of candidates sent back to the high-fidelity solver because of uncertainty, constraint violations, or policy.
- Compare total time at the required error tolerance, not at an arbitrarily convenient loss threshold.
Accuracy, uncertainty, and signoff
Evaluate the engineering outcome
Loss on a random test split is not enough. Select metrics that correspond to the decision the model supports:
Quick wins for a faster PC:
Clear out junk files and repair common Windows errorsFree Scan →Scan for outdated or missing drivers - takes under a minuteDriver Scan →- Device curves, transient error, conservation residuals, and parameter confidence for TCAD.
- Timing, power, area, noise, yield, reliability, and corner coverage for circuits.
- Final PPA, timing closure, congestion, design-rule violations, and manufacturability for physical design.
- Defect-detection or process-control operating points, false-negative cost, and drift over time for manufacturing.
Measure uncertainty and detect distribution shift
Use ensembles, calibrated probabilistic models, conformal intervals, residual diagnostics, or another documented uncertainty method. Define an escalation rule: predictions with high uncertainty, out-of-range inputs, or violated physical checks go to the conventional simulator or a human review. Track inputs and outputs after deployment so that process changes do not silently turn into extrapolation.
Keep conventional simulation in the signoff path
A 2026 mixed-signal survey classified classical methods as the only signoff-accurate approaches in its comparison, while PINNs and large-language-model design tools remained research-stage and Bayesian optimization had greater industrial validation. This maturity snapshot can change, but it supports a conservative policy: use AI for acceleration, exploration, and search unless the specific model has been independently qualified for the required signoff task.
How to build a hybrid semiconductor-AI workflow
- Define the decision. Specify whether the model will rank candidates, replace a simulator in an inner loop, estimate a physical parameter, or produce a signoff artifact.
- Write the validity domain. Record process node or technology, geometry range, voltage, temperature, frequency, corners, topology, layout assumptions, and allowed extrapolation.
- Choose the physical core. Identify equations, conservation laws, boundary conditions, rule decks, or a qualified simulator that can check predictions.
- Audit data coverage. Stratify samples across corners and rare but important cases. Separate training, validation, and genuinely held-out designs or wafers.
- Select the model pattern. Use a PINN when equations supply strong information; a data-driven surrogate when coverage is broad and the task is repetitive; or residual learning when a lower-fidelity model is already useful.
- Scale and balance losses. Nondimensionalize variables where appropriate, monitor each loss component, and test whether one term dominates optimization.
- Add hard gates. Reject invalid geometry, illegal layouts, nonphysical states, and predictions outside the calibrated domain before optimization results are accepted.
- Validate off-grid. Test unseen geometries, corners, circuits, layouts, or process conditions. Compare with high-fidelity simulation and measurements where available.
- Use active learning. Send uncertain or high-value candidates to TCAD or the circuit flow, then retrain with the new evidence.
- Define signoff and rollback. Preserve the conventional flow as the authority, version models with the design and process kits, and specify when the AI component is disabled.
Common failure modes and fixes
| Symptom | Likely cause | Response |
|---|---|---|
| Low training loss but poor corner results | Training data are concentrated near nominal conditions | Stratify corners, hold out entire designs, and add active-learning samples. |
| Physically impossible outputs | Physics is absent, weakly weighted, incorrectly implemented, or invalid outside its domain | Check residual code, units, boundary conditions, and add hard post-prediction checks. |
| PINN training stagnates | Stiff equations, poor scaling, imbalanced losses, or inadequate collocation points | Nondimensionalize, resample adaptively, tune loss weights, and compare with a conventional discretization. |
| Fast surrogate gives poor final PPA | Optimization exploits a proxy-model error | Re-evaluate finalists with the complete physical-design flow and retrain on those failures. |
| Model fails after a process update | Topology or process distribution shifted | Version the model with the process kit, run drift tests, and retrain or restrict the validity domain. |
| Parameter estimates vary widely | Insufficiently informative observations or parameter non-identifiability | Add independent measurements, sensitivity analysis, priors, or a simpler parameterization. |
Decision checklist
- Are the governing equations and boundary conditions known, validated, and applicable to the complete operating range?
- How much representative labeled data can the team generate, and how expensive are new labels?
- Is the objective a continuous physical field, a circuit response, or a discrete physical-design outcome?
- How many evaluations are required, and what latency is actually needed?
- What error is acceptable for ranking, exploration, optimization, and signoff?
- How will uncertainty, out-of-distribution inputs, and physical violations be detected?
- Which conventional simulator or measurement remains the authority?
- Can a hybrid residual, correction, or active-learning design deliver the needed benefit with less risk?
For implementation, evaluate the category of EDA and TCAD simulation software that matches your process, model interfaces, and verification requirements; product capabilities and qualification status differ by release and application.
